Wavelet analysis was performed for the collected pressure signals of gas-liquid two-phase flow in a vertical pipe in an air lift test. The optimal wavelet basis functions were determined by improving the signal-to-noise ratio (SNR). The range of decomposition levels was determined based on changes in energy of detail coefficients, and optimal decomposition levels were determined by the entropy weight method together with SNR, root mean square error and smoothness. After denoise with wavelet thresholding, three-level decomposition of signal was performed with the wavelet packet method, and then flow patterns were identified for gas-liquid two-phase flow with the energy ratio in the 1st and 2nd frequency bands and entropy values as feature vectors. The flow pattern recognition based on 389 sets of pressure signals shows that the extraction feature vector combined with random subspace decision tree can efficiently identify and classify gas-liquid two-phase flow patterns, and the overall mean recognition rate is up to 98.08% by adopting the improved wavelet thresholding.

对垂直管道气力提升实验中采集的气液两相流的压力信号进行小波分析,通过改善信噪比确定最佳小波基函数。根据小波细节系数能量变化确定分解层数范围,采用熵权法结合信噪比、均方根误差以及平滑度确定最佳分解层数。对小波阈值去噪后的信号进行小波包分解,以分解后的第1、2频带能量占比以及熵值作为特征向量对气液两相流进行流型识别。389组压力信号的流型识别结果表明,提取特征向量结合随机子空间决策树模型可以对气液两相流流型进行高效识别分类,采用改进小波阈值法处理后的流型整体平均识别率达98.08%。

对垂直管道气力提升实验中采集的气液两相流的压力信号进行小波分析,通过改善信噪比确定最佳小波基函数。根据小波细节系数能量变化确定分解层数范围,采用熵权法结合信噪比、均方根误差以及平滑度确定最佳分解层数。对小波阈值去噪后的信号进行小波包分解,以分解后的第1、2频带能量占比以及熵值作为特征向量对气液两相流进行流型识别。389组压力信号的流型识别结果表明,提取特征向量结合随机子空间决策树模型可以对气液两相流流型进行高效识别分类,采用改进小波阈值法处理后的流型整体平均识别率达98.08%。

Wavelet analysis was performed for the collected pressure signals of gas-liquid two-phase flow in a vertical pipe in an air lift test. The optimal wavelet basis functions were determined by improving the signal-to-noise ratio (SNR). The range of decomposition levels was determined based on changes in energy of detail coefficients, and optimal decomposition levels were determined by the entropy weight method together with SNR, root mean square error and smoothness. After denoise with wavelet thresholding, three-level decomposition of signal was performed with the wavelet packet method, and then flow patterns were identified for gas-liquid two-phase flow with the energy ratio in the 1st and 2nd frequency bands and entropy values as feature vectors. The flow pattern recognition based on 389 sets of pressure signals shows that the extraction feature vector combined with random subspace decision tree can efficiently identify and classify gas-liquid two-phase flow patterns, and the overall mean recognition rate is up to 98.08% by adopting the improved wavelet thresholding.

气力提升系统广泛应用于海底矿物开采、海洋环境保护、海洋油气运输和海水淡化等领域[1]。气力提升过程中,受各相密度、表面张力和压力等影响,气液两相流易形成不同流型。流型的变化会显著影响流动阻力、压降特性、传热传质效率以及设备运行的稳定性与安全性。因此,研究气液两相流流型识别技术对深海矿物产能提高、设备故障诊断、流动参数测量和生产安全保证等具有重要意义。
近年来,气液两相流流型识别技术主要包括幅值域分析方法、频域分析方法、非线性分析方法、时间-频率域处理法、小波变换法等。幅值域分析方法通过统计参数揭示气液两相流信号的幅度波动特性[2-4],其核心工具为PDF函数,该方法虽能有效描述信号幅度分布,但在实际工程中存在峰值确定困难、对数据长度要求高等问题,限制了其在高效实时流型识别中的应用。频域分析方法特别是功率谱密度(PSD)分析法,通过揭示信号在频率域中的能量分布,能有效提取气液两相流中与流型相关的特征信息[5-7],但PSD的分布不仅受流型影响,还依赖于单相与混合流速等因素,需借助其他手段进行速度测量。非线性分析方法,尤其是基于混沌理论和熵理论的特征提取手段,混沌参数如Kolmogorov熵可用于敏感捕捉流型转变点,信息熵、近似熵及样本熵等则从不同角度度量系统的不确定性与复杂性,表现出对流动状态变化的良好响应特性[8-10],但这类方法普遍依赖高质量原始信号,对采样率、数据长度及去噪手段有较高要求,同时部分指标计算复杂、参数选择敏感。时间-频率域处理法以小波分析、经验模态分析(EMD)、希尔伯特黄变换等为主[11-13]。虽然EMD及其改进方法在气液两相流流型识别中得到了广泛应用,但仍面临模态混叠、噪声干扰与分量筛选不完善等问题,影响识别精度和特征提取效果。小波变换法具有良好的时频局部化功能,十分适合于突变信号和非线性非平稳强随机性信号的分析,因此,基于小波变换法的信号去噪技术得到了广泛关注,其研究重点聚焦在阈值去噪、小波系数的相关性去噪、模极大值去噪等方面[14-15]
本文通过垂直管道气力提升装置开展气液两相流实验,对采集的压力信号进行最佳阈值去噪后,使用小波包分解进行气液两相流流型的分析与判断。
垂直管道气力提升装置采集的压力信号含有噪声信号,具体可表示为以下模型。
式中:ym)为采集的含噪压力信号;fm)为真实信号;nm)为噪声信号。小波阈值去噪过程即在实际采集压力信号中滤除噪声信号得到真实信号的过程。
在小波阈值去噪过程中,阈值的选择对去噪效果起着重要作用。目前常使用的是Donoho等人在高斯噪声模型基础上[16]通过独立正态变量决策理论面得出的阈值,其表达式为:
式中:λ为阈值;N为采集的压力信号长度;σ为信号中噪声的均方差,通过高斯噪声方差δ=median(|di,l|)/0.674 5来获取,dil为各尺度分解下的小波系数。为了使阈值选取因信号差异而改变,本文采用改进后的阈值计算法,其表达式为:
式中:e(1-1/n为收缩因子;n为小波总分解层数。
小波阈值去噪流程如图1所示。
选择均方根误差RMSE、信噪比SNR以及平滑度r作为小波去噪质量的基础评价指标。
均方根误差RMSE计算式为:

在无法得知理论真实信号的情况下,为了有效分析去噪质量,对选取的指标进行优化。仿真发现,随着分解尺度的增加,RMSE、SNR、r的变化量会出现明显的收敛趋势。因此,采用各个指标的变化量来评估去噪质量。
均方根误差变化量VRMSE为:

在计算权重之前,将各个指标的变化量数值规划到[0,1]区间内[17],使其成为纯数值量,数值越小表示去噪效果越好。

熵值法确定权重的基本步骤[18]为:
1)选取m种小波去噪参数、n个评价指标,xij为第i种参数的第j个评价指标的数值;
2)归一化处理后的指标,计算第j个指标下的第i种参数占该指标的比重:

权值分配完成之后,将上述选取的3个指标构建为复合指标,具体表达式为:
式中:Y为复合指标计算结果;wSNRwRMSEwr分别表示计算得到的信噪比变化量、均方根误差变化量及平滑度变化量的权重。
对去噪后的压力信号进行小波包分析,通过一定的高频与低频共轭正交滤波器,将信号分解到不同的子频带上[19-21]。假设Φt)为空间范围内的某个尺度函数,Ψt)为该尺度函数对应的正交小波。当有离散时间压力信号序列S时,小波分解式如下:

计算信号的能量EDi)和EAi)可由分解得到的小波包系数平方表示:
而压力信号的总能量E等于细节信号能量与近似信号能量的总和[22]
对采集的压力信号预处理后进行3层小波包分解,可提取到从低频到高频的8个频带信号,再对得到的小波包系数进行小波包重构[23],提取各个频带的信号。重构信号与原始分解信号S的关系为:

根据式(24)计算得到的能量占比可计算不同流型的小波包熵值:
气液两相流液体提升装置如图2所示,空气压缩机中的空气经过稳压阀、气体流量计、流量调节计,最后通过注气口均匀地进入气力提升垂直管道内。进入提升管内的气体、液体流经分离箱,空气从分离箱上端排出,液体则流回到管内实现内部水循环,在水平回流管段安装声波流量计。
本实验装置采用连通器原理实现水循环,在提升水的过程中严格保证浸没率(提升管水平液面到进气口距离与进气口到提升管出口距离的比值)恒定,更贴合工程实际情况。提升管由多段亚克力(透明的有机玻璃管)通过法兰连接的方式制成,内径为50 mm,长度为3 200 mm,测量段距进气口的距离为900 mm,进气口分别使用上中下三个不同位置,浸没率分别调为0.8,0.7,0.6和0.5。其中压力传感器的采样频率为10 kHz,实验记录5 s共获得50 K数据。同时,采用CCD摄像机对流型进行可视化观察,使用USB-6361NI采集卡以30 kHz的采样频率采集0~5 V电压信号,并通过DAQexpress数据采集软件将电压信号转化为压力信号。CCD摄像机拍摄的垂直立管实验段气液两相流流型如图3所示,观察图3可知,气液两相流运动过程中,实验段气液两相流的流动结构发生改变,可以分为泡状流、弹状流、搅浑流和环状流。
对采集的含噪声压力信号进行小波阈值去噪,在对不同流型的气液两相流去噪过程中,首先以可改善的信噪比来确定最佳小波基函数。考虑小波基函数支撑长度、对称性、正交性、相似性等要求,本文选取符合要求的db、sym、coif三类小波基函数。以泡状流和弹状流确定的不同小波基函数可改善信噪比如图4所示。泡状流中,db5小波基的信噪比(57 dB)最高。弹状流中,db8小波基的信噪比(53.59 dB)最高。
在低尺度分解情况下所得到的小波细节系数以噪声为主,随着分解层数增加,小波细节系数开始包含有效信号,在小波近似系数中包含的有效信号开始出现失真。对不同分解尺度下的小波细节系数能量进行计算,由于有效信号的能量远大于噪声信号的能量,小波细节系数能量最小时的分解层数为最佳分解层数[24]。对不同分解尺度下所得出的指标使用熵权法融合成一个复合指标,进一步判断此分解层数是否为最佳分解层数。对不同分解尺度下流型的小波细节系数能量进行对数处理,结果如表1所示。
通过表1可知,泡状流和弹状流第4层的小波细节系数能量最小,搅浑流和环状流第3层的小波细节系数能量最小。
不同分解层数下各流型性能指标如图5所示。
对不同流型的信噪比SNR、均方根误差RMSE以及平滑度r计算复合指标,结果如表2所示。
表2可知,泡状流与弹状流第4层对应的复合指标值最小,搅浑流和环状流第3层对应的复合指标值最小。因此,在确定最优小波基函数和最佳分解层数后进行小波阈值去噪,不同流型去噪效果如图6所示。
图6可知,泡状流压力波动范围为8.03~8.45 kPa,环状流压力波动范围扩大至5.30~15.88 kPa。
对去噪后的4种流型压力信号进行3层小波包分解后分别进行8个频带分析,不同流型的频谱如图7所示。
图7可知,4种流型信号能量主要集中在0~40 Hz,不同流型的能量进行3层小波包分解,主要集中在低频带的第1频带和第2频带内。将第1频带和第2频带能量占比作为特征向量分析不同流型的运动变化,结合小波包熵值进一步反应不同流型的复杂度和不确定性。不同流型第1、2频带内能量占比和熵值变化如图8所示。
图8可知,泡状流第1频带能量占总能量的80%以上,主要原因是水作为连续相,由于其低速变化缓慢,在低频带内可以产生较强的压力,气泡在流动水中由于无序流动和不规则形状,可以产生较高的高频压力;弹状流能量在第1频带开始下降,并开始转移到其他频带,大部分第1频带能量占比下降至60%~80%,而第2频带能量占比开始增加。弹状流中液体与液体之间和液体与管壁之间的碰撞加剧,泰勒泡的破裂会产生一些高频振动,旋涡迅速产生并消失,增加了频率的波动。流型变为搅浑流时,大部分第1频带能量占比继续下降至40%~65%,第2频带能量占比增加相较于弹状流更多,大部分为20%~45%。气体流速达到最大时,流型转变为环状流,环状流第1频带能量占比急剧下降,而第2频带能量占比急剧上升至40%~80%,因为小气泡的增加大大降低了混合物的密度,增加了混合物的无序性,并且增加的气流会促使小气泡合并成一些不规则的大气泡群,液体间的碰撞更加激烈,促使第2频带能量占比急剧上升。流型未达到环状流时,小波包熵值与气体流速成正比。气体流速较小时,小气泡会呈现规则的形状和似周期性的运动,随着气体流速增加,小气泡之间会开始聚并成大气泡,液体之间的碰撞开始加剧,促使大气泡的形状与运动轨迹呈无序性,周期性波动会逐渐减弱并消失,演变成不稳定的混沌运动,导致小波包熵值上升,搅浑流的小波包熵值最大。流型为环状流时,流体有序地环绕管道向上流动,气泡的破裂、聚集和分散偏少,气相体积比远大于液相体积比,气相与液相流动连续,形成相对稳定的界面,此时信号具有一定的周期性,流型相对有规律性,不规则性和混乱性下降,小波包熵值开始出现下降趋势。
在气液两相流实验中,采集的流型压力信号组成的数据集共有389组(其中泡状流134组、弹状流79组、搅浑流97组、环状流79组),随机选取70%数据集作为训练集,剩余数据集作为测试集,泡状流、弹状流、搅浑流、环状流标签分别设为1,2,3,4,输入模型中进行流型识别。识别模型采用朴素贝叶斯分类器(Naive Bayes classifiers,NB)、K近邻(K-nearest neighbor classification,KNN)、随机森林(random forest,RF)、自适应提升决策树(adaptive boosted decision tree,AB-DT)和随机子空间决策树(random subspace decision tree,RS-DT)模型预测结果。为验证不同算法的性能,每个模型分别运行50次,计算各模型的识别率,结果如表3所示。
根据表3的结果,采用5种模型中识别率最高的RS-DT模型对改进前后小波阈值法处理的数据集进行流型识别,结果如表4所示。
实验结果证明,气液两相流压力信号采用改进后的小波阈值去噪,小波包分解所提取能量和熵值,构建反映压力信号的特征向量,利用随机子空间决策树模型可以快速高效地对流型进行分类识别。
1)采集气液两相流的压力信号,结合小波分解后的小波细节系数能量特征确定最佳分解层数范围,采用熵权法确定有效指标最佳分解层数。
2)小波包分解发现能量分布主要在第1频带内,随着气体流速逐渐增加,气泡开始出现聚并时,第1频带能量呈线性下降,而第2频带能量开始逐渐回升。
3)流型未达到环状流时,小波包熵值与气体流速成正比;流型过渡到环状流时,流型的稳定性和周期性增加,小波包熵值开始急剧下降。
4)气液两相流压力信号采用改进的小波阈值去噪后,利用随机子空间决策树模型可以快速高效识别流型,流型整体平均识别率达98.08%。
5)实际工业中出现的流型可能并不是单一的流型,而是多种流型混合的复杂流动。未来将进一步开展在实际提升过程中更为复杂的两相流情况以及气液固三相流混合流型的识别研究,验证提出流型识别方法的有效性和可靠性。
