In order to effectively predict blast-induced rock fragmentation, a distribution of normalized rock fragmentation under different conditions was obtained by performing a designed experiment on drilling and blasting of a concrete specimen, and then the rock fragmentation exceeding 40 mm was selected for study. The correlation among variables under different testing conditions was analyzed by using Spearman correlation statistics, and the initial weights and thresholds of the BP neural network were optimized by using the ant colony optimization (ACO) to construct an ACO-BP model. The model was then trained with rock fragmentation by on-site blasting, and tested. Based on the comparison of such prediction mode with BP neural network model, random forest (RF) model and extreme gradient boosting (XGboost) model, it is found that the ACO-BP model is highly reliable in predicting blast-induced rock fragmentation, presenting a root mean square error of 0.13, an average absolute error of 0.11, and a coefficient of determination of 0.92. It is concluded that this model, with higher accuracy in prediction and applicability, can accurately predict blast-induced rock fragmentation.

为了对岩石爆破破碎块度进行有效预测,设计开展了混凝土试件钻孔爆破试验,得到不同试验条件下的破碎块度归一化值分布,最终选取试块尺寸40 mm以上进行研究。采用Spearman相关系数分析各试验条件参数之间的相关性,再采用蚁群算法(ACO)优化BP神经网络的初始权值和阈值,构建ACO-BP模型。结合现场试块爆破破碎块度数据对模型进行了训练和测试,并将预测模型与BP神经网络模型、随机森林(RF)模型、极限梯度提升(XGboost)模型进行了对比。结果表明,ACO-BP模型预测爆破块度均方根误差为0.13,平均绝对误差为0.11,决定系数为0.92,预测精度和适用性更高,能够更准确地预测岩石爆破破碎块度。

In order to effectively predict blast-induced rock fragmentation, a distribution of normalized rock fragmentation under different conditions was obtained by performing a designed experiment on drilling and blasting of a concrete specimen, and then the rock fragmentation exceeding 40 mm was selected for study. The correlation among variables under different testing conditions was analyzed by using Spearman correlation statistics, and the initial weights and thresholds of the BP neural network were optimized by using the ant colony optimization (ACO) to construct an ACO-BP model. The model was then trained with rock fragmentation by on-site blasting, and tested. Based on the comparison of such prediction mode with BP neural network model, random forest (RF) model and extreme gradient boosting (XGboost) model, it is found that the ACO-BP model is highly reliable in predicting blast-induced rock fragmentation, presenting a root mean square error of 0.13, an average absolute error of 0.11, and a coefficient of determination of 0.92. It is concluded that this model, with higher accuracy in prediction and applicability, can accurately predict blast-induced rock fragmentation.

在矿山开采过程中,爆破开挖是一个非常关键的过程。优化爆破参数是降低生产总费用、提高生产效益的关键。对爆破效果进行量化、精确的检测一直是国内外科研人员关注的焦点[1-2]
关于爆破破碎块度预测国内外学者进行了大量研究,并提出了许多理论模型[3]。经典模型包括Kuz-Ram模型[4]和Rosin-Rammer模型[5]。随着人工智能技术的快速发展,计算机分析在爆破工程中得到了广泛应用[6],近年来国内外学者开始运用机器学习的方法,如BP神经网络[7]、支持向量机[8]等对爆破块度进行预测。刘英等[9]基于BP神经网络基本原理,利用PSO算法优化网络权重和偏置,构建PSO-BPNN预测模型,缩短了爆破块度计算时间,可靠性高;模型预测输出值与工程实际平均爆破块度值最大相对误差为6.56%。JIA等[10]利用灰狼优化器(GWO)对ELM的输入权值和隐层阈值进行优化,建立GWO-ELM爆破破碎块度的预测模型,该模型精度更高,数据拟合能力强。然而,BP神经网络用于预测爆破破碎块度存在训练过程可能陷于局部最小等缺陷。通过改变爆破参数,从而控制爆破块度,可有效解决二次破碎成本高、搬运难度大、粉尘污染等问题。因此对岩石爆破破碎块度进行准确预测极为关键。
本文利用采用蚁群算法(ant colony optimization,ACO)对BP神经网络进行优化,确定最优的初始权值和阈值参数,将其代入BP神经网络,构建ACO-BP预测模型。设计2次爆破试验,并对试验数据进行Spearman分析,确定各种爆破破碎块度影响因素之间的主次关系;在此基础上,选取80%的试验数据作为训练集,剩余20%数据作为预测集进行预测。并与BP神经网络模型、随机森林模型(RF)、极限梯度提升模型(XGboost)的预测结果进行对比分析,以此验证ACO-BP模型的可行性。
在2次不同条件下的混凝土试件爆破试验中共得到315个数据集。试验1以边长150 mm的混凝土试件为研究对象,设计并制作了21个标准试件,按设计强度等级C30、C40和C60分为3组,分别用字母S、H和T表示,每组各7个,在试件的中心钻炮眼,孔深125 mm,孔径8 mm。将数码电子雷管放置于炮孔底部,如图1所示。试验2同样选取边长150 mm的混凝土试件为研究对象,设计并制作了42个标准试件,试件编号用N表示。各组试件的混凝土强度、约束面和水环境条件见表1,其中,约束面和自由面之和等于6。在地面先挖一个深度相当于2倍试件边长(总深约300 mm)的立方体坑洞。设置约束面前,需将坑洞四周磨平,尽可能增大试件与坑洞接触面的摩擦,让咬合力接近于现场实际。将试件约束面与坑洞紧密接触实现约束。试件顶部通过回填压实现场岩土实现与坑洞壁接触。无水环境是指坑洞纯自然环境。有水环境是指往坑洞浇灌水直至溢出,并保持整个爆破过程,旨在模拟水饱和环境下的爆破破碎块度试验。
所有试件均采用单发雷管引爆,炮孔、炮泥、起爆器、室外温度、起爆条件等均保持一致。通过专用粒径筛对爆破后的试件破碎块度进行分类筛选。
图2为2次试验数据不同爆破破碎块度的归一化值,通过图2可以直观地分析异常值。样本的中位数由白色圆点表示,粗黑线的顶部和底部分别表示样本的第3和第1个四分位数。上邻值和下邻值分别由黑色细线的顶部和底部表示,线外为离群值。由图2可以看出,除试块尺寸0~5 mm外,其他数据分布较为均衡,考虑到较大的爆破块度在爆破中造成的影响,选取试块尺寸40 mm以上进行预测。
ACO是一种仿生智能优化算法[11],最早由意大利学者Dorigo、Maniezzo等于1991年提出,通常用于路径规划等问题。
ACO基本流程如下:
1)初始化参数设置。蚁群算法的参数包括信息素启发式因子α、期望启发式因子β、信息素汽化因子ρ、信息素强度Q、最大迭代次数K、蚁群数M
2)转移概率。传统蚁群算法采用轮盘赌的方法选择下一个转移点,适应度大的点转移概率高。第m个蚂蚁从第i位转移到第j位的转移概率按下式计算:
式中:τij)为信息素浓度;ηij)为启发式信息;Jm为当前点的可移动点集合。
3)信息素更新。信息素的更新规律包括信息素增强和信息素挥发,分别按下式计算:
式中:ρ为取值为[0,1]的全局信息素挥发因子;(1-ρ)为信息素残差系数;为当前迭代中从第i个点到第j个点的信息素浓度;为当前迭代中第m个蚂蚁从第i个点到第j个点的路径上的信息素浓度变化;Lm为当前迭代中第m个蚂蚁的路径长度。
BP神经网络[12]是1986年由Rumelhart和McClelland为首的科学家提出的概念,是应用较为广泛的神经网络模型之一。BP神经网络是一种按误差反向传播的多层前馈网络[13],利用梯度下降法和非线性变换,使输出误差最小。尽管BP神经网络能解决较复杂的非线性问题,但易收敛于局部极小值点。ACO则可以较好地克服上述问题。
采用ACO优化BP神经网络的基本思路是:获得权值矩阵和阈值向量的因素,构成蚂蚁种群的路径坐标。蚂蚁到达食物源的路径越短,路径上的信息素含量越高,所以将均方误差作为蚂蚁的适应度值。最终蚂蚁种群确定的最短路径作为最优初始权值和阈值参数,再赋给BP神经网络,进行训练和测试。
ACO-BP算法流程如图3所示。
为了得到模型的预测性能,采用均方根误差ERMSE、平均绝对误差EMAE、决定系数R2等3个指标进行评价,计算公式[14]如下:
式中:yi为观测值;为预测值;为观测值的平均值;n为训练或测试阶段的样本个数。
ERMSEEMAE的值越接近0,所使用的机器学习(machine learning,ML)方法的预测性能越好。R2介于0~1之间,R2越大,表明预测模型越有效。
采用Spearman相关系数分析各试验条件参数之间的相关性,相关热力图如图4所示。由图4可知,约束面个数、水环境条件是影响爆破破碎块度的重要指标,其Spearman相关系数分别为0.632、0.484。混凝土强度对爆破破碎块度的影响较小,Spearman相关系数为0.187。
采用MATLAB建立ACO-BP模型,考虑到数据集大小,对模型初始化参数进行设定,初始化参数取值见表2表3
将归一化处理后的63组数据集分为2组,前50组(约占总数据集的4/5)为模型的训练样本,对模型进行训练和学习,结果见图5;后13组(约占总数据集的1/5)作为测试样本进行预测。由图5可知,当进化代数达到45时,曲线已趋于平稳状态。将得到的最佳阈值和权重代入BP模型,对测试样本进行预测,得到测试样本的真实值与预测值对比见图6
图6可知,ACO-BP模型的预测效果良好,统计得到测试样本真实值与预测值的均方根误差ERMSE=0.13,相关系数R2=0.92,说明该模型回归拟合效果良好。
为了得到较为精准的预测块度的ML方法,利用20%的数据集对ML方法预测数据的可靠性进行测试,并对预测值和实测值进行比较。通过输入13组测试样本数据进行预测,分别与未优化的BP神经网络模型、RF算法、XGboost算法进行对比分析,4种模型对爆破破碎块度的预测值与实测值的对比结果见图7
图7可知,ACO-BP模型的预测值与实测值最接近,效果明显优于未经优化的BP模型、RF模型和XGboost模型。
根据式(4)~(6)计算4种ML模型的预测结果见表4。由表4可知,XGboost模型和RF模型的预测精度较差。BP神经网络模型运算时间短,相对于RF模型和XGboost模型,其预测精确度有较大提高,说明BP模型更适用于数据集样本较少的爆破破碎块度预测。ACO-BP神经网络模型在本研究中的预测精度更高且波动性更小,R2更接近1,模型的拟合效果更好,能够更精确地预测爆破破碎块度。
1)利用蚁群算法优化BP神经网络的初始权值和阈值,构建了用于岩石爆破破碎块度预测的ACO-BP模型。
2)通过对影响爆破破碎块度的几个因素进行Spearman相关系数分析,得出试验条件下约束面个数、水环境条件是影响爆破破碎块度的两个重要因素。
3)与BP神经网络模型、XGboost模型、RF模型相比,ACO-BP模型预测效果更好,预测误差更小(ERMSE=0.13,EMAE=0.11,R2=0.92)。该算法可进一步提高爆破破碎块度预测精度。
