The study examines wires in high-vibration zones of aircraft, where artificial damage was introduced to accelerate wear. Step-up-stress vibration testing was conducted to simulate accelerated aging and measure wire wear over a fixed period. Three surrogate models were developed using the wire diameter after artificial damage as the input and the experimentally obtained wire wear as the output. This established a nonlinear relationship between the initial artificial damage and the wear rate. The finite difference method was applied for time superposition to approximate the entire life cycle. Results indicate that the surrogate model using a back propagation neural network (BPNN) achieved the highest accuracy. Predicting lifespan through wear rate across the product's lifecycle can significantly reduce experimental costs. These findings provide theoretical and experimental guidance for future research on anti-wear technology and health management of aircraft wiring harnesses.

以飞机高振区导线为研究对象,人工创造导线损伤加速导线磨损,进行步进应力加速老化振动试验,获得一段固定时间的导线的磨损量;以施加人工损伤后的导线线径为输入量,试验得出的导线磨损量为输出量,建立3种不同代理模型,对建立施加的初始人工损伤和此损伤下的导线磨损速率之间的非线性关系,应用差分法进行有限次时间叠加近似得到全寿命周期。结果表明:3种代理模型中应用反向传播神经网络(BPNN)建立的代理模型精度最高,通过产品全生命周期的磨损速率来对产品进行寿命预测可以节约大量试验成本。研究结果可为后续研究飞机线束防磨技术和线束健康管理,提供理论和试验指导。

以飞机高振区导线为研究对象,人工创造导线损伤加速导线磨损,进行步进应力加速老化振动试验,获得一段固定时间的导线的磨损量;以施加人工损伤后的导线线径为输入量,试验得出的导线磨损量为输出量,建立3种不同代理模型,对建立施加的初始人工损伤和此损伤下的导线磨损速率之间的非线性关系,应用差分法进行有限次时间叠加近似得到全寿命周期。结果表明:3种代理模型中应用反向传播神经网络(BPNN)建立的代理模型精度最高,通过产品全生命周期的磨损速率来对产品进行寿命预测可以节约大量试验成本。研究结果可为后续研究飞机线束防磨技术和线束健康管理,提供理论和试验指导。

The study examines wires in high-vibration zones of aircraft, where artificial damage was introduced to accelerate wear. Step-up-stress vibration testing was conducted to simulate accelerated aging and measure wire wear over a fixed period. Three surrogate models were developed using the wire diameter after artificial damage as the input and the experimentally obtained wire wear as the output. This established a nonlinear relationship between the initial artificial damage and the wear rate. The finite difference method was applied for time superposition to approximate the entire life cycle. Results indicate that the surrogate model using a back propagation neural network (BPNN) achieved the highest accuracy. Predicting lifespan through wear rate across the product's lifecycle can significantly reduce experimental costs. These findings provide theoretical and experimental guidance for future research on anti-wear technology and health management of aircraft wiring harnesses.

飞机飞行期间会发出很高量值随机振动激励。线束制造敷设时,由于卡箍和线束间有间隙,各导线之间会形成摩擦副,在高频振动应力反复作用下产生微动磨损,且微动磨损率随载荷的增加而呈指数增长[1]。导线的外绝缘层会因为磨损加重逐渐脱离本体,最终线芯将会裸漏出来[2],这将会极大地影响飞机飞行的安全[3]。随着人工智能的兴起,很多学者使用深度学习算法对电缆进行故障识别且获得了较高的识别精确度[4-6],证明了数据驱动的模型算法的可靠性。
对于导线的寿命计算常常采用人工应力加速老化试验方法进行试验,加速被测物品失效,然后运用物理模型和累计损伤理论进行寿命评估[7-11]。但是应力加速意味着需要更大载荷的设备,对设备要求较高,而代理模型的计算时间成本更低、普适性更强[12],可以使用较少的试验样本预测想要获得的变量,也可以考虑与寿命有关的多个参数,构建更可靠的概率模型[13]。本文提出应用加速老化试验结合代理模型的方法计算导线寿命,应用加速老化试验获取数据样本,通过数据驱动构建代理模型快速预测飞机导线的寿命指标。
代理模型是一种黑盒模型,其基本思想是用适量的样本数据,通过插值或拟合等方式建立计算时间成本较低的代理模型以替代计算时间成本较高的学科分析模型[14]
常用的代理模型包括Kriging代理模型、支持向量机、多项式响应面模型和人工神经网络模型等,然而不同的代理模型对于同一问题的适用性不同[15]。本文选用径向基函数(radial basis function,RBF)神经网络、反向传播神经网络(back propagation neural network,BPNN)、Kriging代理模型这3种代理模型作为算法模型,模拟计算导线样本不同初始磨损量下的导线外径与此条件下50 h振动磨损量之间复杂的函数关系。
RBF神经网络代理模型由3个基本层构成,分别为输入层、隐藏层和输出层。它通过计算目标点与神经元之间的欧几里得距离来计算该神经元的权重系数,从而确定各个输入特征的相对重要性。

式中:xP为第P个输出样本;ci为网络隐藏层节点的中心;wij为隐藏层到输出层的连接权值;i=1,2,…,k为隐含层的节点数;yj为与输入样本相对应的网络的第j个输出节点的实际输出。
BPNN代理模型具有记忆能力强、学习速度较快、可应用于非线性问题等优点[16]。典型三层BPNN结构如图1所示[17],BPNN的算法利用导数链式法则,将输出误差沿着反方向逐层反向传播并对权重进行调整,以最小化输出误差。这样就能让神经网络在训练集上持续优化,提升泛化性能,达到更好的预测效果。

误差的反向传播过程如下。首先由输出层逐层开始计算各层神经元的输出误差,各层权值和阈值根据误差梯度下降算法调节,达到最终输出接近期望值的目的:

Kriging代理模型做插值预测的基本思路为:设x1x2,…,xn为区域上一系列观测点,zx1),zx2),…,zxn)为相应的观测值,区域化变量在x0处的值z*x0)可以采用一个线性组合来估计,用无偏性和估计方差最小作为wi选择的标准,得到尽可能准确的结果:
Kriging代理模型中,样本数据的空间自相关性被认为是一个随机变量,并与高斯滤波器一样通过一个半径为R的搜索窗口内距离来度量。该模型通过最小化预测误差和模型复杂度之和的损失函数来进行模型参数的优化,从而得到最优的Kriging模型。
飞机在导线损伤区域的振动行为,是导线发生磨损的主要原因[18]。飞机导线的应力加速老化试验就是对该损伤模式的再现。人工先用工具打磨导线,这种方法可以模拟导线在实际运行中因接触或受外力摩擦而产生的微小损伤,先给导线创造一定程度的损伤,从而加速导线磨损。量取打磨后的导线外径并记录,所用导线人工打磨前的外径与打磨后的外径差值即导线初始人工磨损量。打磨好的导线每三根一组用卡箍固定在工装上,模拟导线在飞机上的敷设状态,按照预定功率谱密度进行随机振动,模拟导线在飞机尾梁区的振动状态。振动试验所用振动量值为安装在涡喷发动机上的设备所受随机振动量值,大小如图2所示,所用工装及打磨好的导线敷设方式如图3所示。
在振动试验进行50 h后,再次量取导线外径,取16个有效样本,同时,为了提高模型精度,选择边界条件同时作为有效输入样本。能量磨损理论[19]认为当一定体积材料积累的能量达到临界数值时,就会以磨屑的形式从表面剥落,才开始产生磨损。因此,认为完整导线最初振动50 h未到达产生磨损条件,期间磨损量为0 mm。
本研究中把振动试验前人工打磨后的导线外径作为输入变量,在此状态下振动50 h的磨损量作为输出变量,此时每个输入量都有一个相对应的输出量。采用最大绝对误差(maximum absolute error,MAE)来检验3种近似建模方法的建模精度[20],最大绝对误差MAE的计算公式为
应用Matlab构建3种代理模型的算法程序,训练集随机包含12个样本,利用训练样本分别建立RBF神经网络代理模型、Kriging代理模型和BPNN代理模型;测试集包含5个样本,用来验证代理模型的精确度。选用不同代理模型训练集预测结果对比如图4所示,选用不同代理模型测试集预测结果对比如图5所示。
选用不同代理模型外推对整个导线外径区间进行预测。不同人工磨损后的导线外径都对应一个初始磨损量,以初始磨损量作为横轴代表的物理意义表示导线在实际振动过程中的磨损程度,用初始磨损量代替人工磨损后的导线外径作为图示横轴以取得更好的可视化效果。输入和输出的预测关系曲线如图6所示。比较样本预测结果误差,分析其适用性,3种代理模型训练集和测试集预测误差结果及预测曲线适用性用性分析见表1
结果显示,通过预测结果最大绝对误差对比,Kriging代理模型不能对已有训练集做预测,BPNN代理模型训练集预测效果较好,在做测试集预测时BPNN预测效果最好。通过拟合的关系曲线得知,3种代理模型的关系曲线线形都比较接近实际工程问题,其中BPNN代理模型和RBF神经网络得到的关系曲线较平滑,而Kriging代理模型预测远端零值附近时出现违反工程实际的负值。
由BPNN代理模型预测得到的导线振动50 h磨损量可以近似得到平均磨损速率为
式中:x为振动磨损时间;ux)为样本导线振动试验前的外径,也可用来代表随振动时间的延长导线的磨损程度;uxx)为样本导线进行50 h振动试验后的外径。
有限差分法的基本原理是用近似方法处理微分中的微分项,用斜率代替导数只需步长Δx足够小即可,本研究Δx为50 h足够合理。用v代表导线振动期间的磨损速率,则vu'(x)。
式(9)计算的导线外径与对应磨损速率的关系如图7所示。
导线绝缘层外径厚度0.3 mm,即导线外径1.7 mm,内径1.4 mm。把导线绝缘层厚度分为N个区间,每个区间长度(0.3/N)mm,分别将包含首位的各外径节点记为ui,记导线从节点ui磨损到节点ui+1所花费时间为xi。导线从外径u1磨损到ui+1所花费的总的振动时间即为导线总的振动磨损寿命,用s表示。
由式(10)~式(13)得到导线外径与振动磨损寿命关系如图8所示。
N取300时,选用BPNN代理模型的计算得的出每个区间节点的磨损速率作为寿命计算所用数据,计算本次试验所选导线在飞机尾梁区实际随机振动工况下寿命约为12 877 h。因为差分法分区多少和端点选择原因,计算结果偏大。
(1)应用加速老化试验获取一段时间磨损量来代替获取整个寿命周期,通过数据驱动构建代理模型可快速预测飞机导线的寿命指标,大量节约试验时间和计算成本。
(2)在RBF神经网络、BPNN、Kriging代理模型3种代理模型中,应用BPNN建立的代理模型得出的初始磨损量和该点振动磨损率关系曲线最符合导线在振动下的实际磨损情况。应用BPNN代理模型预测导线在飞机尾梁区实际随机振动工况下寿命约为12 877 h。
(3)本次研究所用试验方法和结果,可对后续研究线束防磨技术提供试验和理论指导;所用导线寿命计算方法,也可通过输入服役期间的导线外径用于预测导线的剩余寿命,从而对线束健康管理提供理论指导。
