In order to build low-temperature driving range conditions for electric vehicles, this paper utilizes the T-BOX cloud based big data platform for electric vehicles in natural user scenarios, selects speed-related parameters by application principal component analysis, obtaining kinematic fragments of low-speed, medium-speed and high-speed through cluster analysis methods, compares the difference in travel speed of trams at normal temperature and low temperature, establishes a speed curve suitable for low temperature test according to the probability density calculation results, and simultaneously extracts the information of ambient temperature, air conditioning grade and air conditioning temperature. The relationship between ambient temperature and air conditioning setting is analyzed, the ambient temperature and air conditioning setting information suitable for low temperature test are obtained. The results show that compared with normal temperature, the low-speed driving time is extended by 3%, the medium-speed and high-speed driving time are reduced by 2% and 1% respectively, and the ambient temperature setting to -22 ℃, the air conditioning level setting to 3, and the air conditioning temperature setting to 26 ℃ can represent the using scenarios of most users, finally building a low temperature driving rangeworking condition of electric vehicles which is closer to the user’s actual situation.

为了构建电动汽车的低温续驶里程工况,利用用户自然场景中电动汽车的T-BOX云端大数据平台,应用主成分分析选取了速度相关参数,通过聚类分析方法获取了低速、中速和高速的运动学片段,对比了电动汽车在常温和低温下的行驶速度差异,根据概率密度计算结果建立了适用于低温试验的速度曲线,同时提取环境温度、空调等级与空调温度等维度的信息,分析了环境温度与空调设置的关系,得到适用于低温试验的环境温度和空调设置信息。结果表明,低温与常温相比,电动汽车低速行驶时间延长了3%,中速和高速的行驶时间分别降低了2%和1%,并且环境温度截止至-22 ℃,空调等级设置为3级,空调温度设置为26 ℃可以代表大多数用户的使用场景,最终构建了更加贴近用户实际的电动汽车低温续驶里程工况。

In order to build low-temperature driving range conditions for electric vehicles, this paper utilizes the T-BOX cloud based big data platform for electric vehicles in natural user scenarios, selects speed-related parameters by application principal component analysis, obtaining kinematic fragments of low-speed, medium-speed and high-speed through cluster analysis methods, compares the difference in travel speed of trams at normal temperature and low temperature, establishes a speed curve suitable for low temperature test according to the probability density calculation results, and simultaneously extracts the information of ambient temperature, air conditioning grade and air conditioning temperature. The relationship between ambient temperature and air conditioning setting is analyzed, the ambient temperature and air conditioning setting information suitable for low temperature test are obtained. The results show that compared with normal temperature, the low-speed driving time is extended by 3%, the medium-speed and high-speed driving time are reduced by 2% and 1% respectively, and the ambient temperature setting to -22 ℃, the air conditioning level setting to 3, and the air conditioning temperature setting to 26 ℃ can represent the using scenarios of most users, finally building a low temperature driving rangeworking condition of electric vehicles which is closer to the user’s actual situation.

现阶段我国燃油车能耗、排放和续驶里程采用新欧洲驾驶周期(New European Driving Cycle, NEDC)测试工况,该工况主要适用于欧洲国家。为建立更加符合我国道路特征的行驶工况,中国汽车技术研究中心通过大量汽车道路试验,自主建立了基于大量城市和车辆数据定义的中国轻型车行驶工况-乘用车(China Light-duty vehicle Test Cycle-Passenger, CLTC-P)。相比于NEDC工况,CLTC-P工况包含的路况信息更能够代表中国工况特点,涵盖了城市工况、郊区工况与高速工况,目前已经逐渐应用于纯电动汽车的续驶里程测试。然而试验过程中发现,CLTC-P工况下,环境温度为-7 ℃时,电动汽车续驶里程衰减了近40%[1]。我国东北地区冬季十分寒冷,电动汽车在低温环境下的续驶里程缩减问题成为了用户的关注焦点,建立一种贴近用户驾驶习惯的电动汽车低温续驶里程工况成为学者们重点研究的对象。目前已有学者开展了电动车辆在低温时的续驶里程试验,试验工况除了参考现有标准外,还对空调进行了一些主观设定,但低温续驶里程测试结果差异较大,环境温度仅考虑-7 ℃不足以反映东北地区的真实温度情况,因此不能作为客观的续驶里程标准体系[2-3]
常规汽车行驶工况大多基于城市路况特征建立,许多国外学者结合所在城市交通情况,在私家车上安装设备采集真实的交通特征,从而建立汽车行驶工况[4-5]。而国内学者通常根据当前城市交通流,选取乘用车进行大数据采集,建立城市驾驶数据样本库,通过K-means聚类分析和马尔科夫链构建具有代表性的行驶工况[6-7]。此方法通常需要提前规划行驶路线,且只体现了城市交通情况,缺乏对车辆自然场景的考虑,无法获取环境温度与车内电气设备的使用状况。
相比于常规汽车行驶工况的建立,CLTC-P工况的建立综合考虑了多种因素,如人口、汽车保有量以及城市交通、地理特点。本文旨在CLTC-P工况速度曲线的基础上,针对某在售商品车辆用户的自然驾驶场景,通过对我国冬季东北地区电动汽车车载T-BOX开展云端大数据分析,寻找常温和低温条件下用户行驶速度差异,建立适用于低温续驶里程试验的速度曲线,同时提取用户在行车时低温环境温度与空调设置,结合低温时车辆多维度特征,构建能够代表用户驾驶行为的电动汽车低温续驶里程工况,为电动汽车低温续驶里程测试提供新思路。
选取市场某在售商品车为研究对象,该型号车辆载有高精度车载终端与云端网络通信矩阵,能够深度读取车辆定位信息和控制器局域网总线(Controller Area Network, CAN)数据并实时上传至云端大数据平台。通过经纬度定位筛选出行驶区域在黑龙江、吉林、辽宁以及内蒙古部分地区车辆。在选定时间维度上,车辆所处环境温度低于GB/T 18386.1—2021《电动汽车能量消耗量和续驶里程试验方法 第1部分:轻型汽车》要求的(-7±3)℃[8],大数据中车辆具体信息如表1所示。
此云端大数据平台采集的数据点数量过亿,涵盖范围足够广泛,行驶里程和时间充足,数据随机性较强,路况信息充分,驾驶行为特征存在较大差异,数据代表意义较强,可以满足工况构建需求。
冬季东北地区道路上存在积雪和冰面,路面附着系数极低,为保证行车安全,车辆的整体行驶速度会有所下降,低速行驶的时间占比相对会更高,加减速的数值相对较小,因此在建立电动汽车低温续驶里程工况时应该充分考虑车速相关参数的变化。
低温环境下,电池内阻增加,放电量下降[9],环境温度降低使电池容量保持率也降低[10-11],电池续航能力变差,电池相对容量与环境温度关系如图1所示。电池的衰减最终会导致电动汽车低温续驶里程能力大幅减弱,环境温度数值和续驶里程测试结果紧密相关。
作为电动汽车中能量消耗最大的辅助设备,空调受到使用环境的影响较大[13]。不同于传统燃油车,电动汽车的暖风系统通过消耗电能来实现,根据GB/T 18386.1—2021《电动汽车能量消耗量和续驶里程试验方法 第1部分:轻型汽车》,环境温度为-7 ℃时,车内温度尽量保持在20~22 ℃[8]。标准中未给出空调档位与吹风等级,而不同的空调调节方式必然会产生不同的续驶里程结果。因此有必要采用大数据分析方法,获取能够代表大多数用户的空调设置信息,建立统一的试验标准。
从上述大数据平台中开展数据提取工作,获得满足条件的信息,如车辆的车速、运行时间、加减速度、环境温度、空调温度和空调吹风等级。原始数据采集结果可够转化为“4×107行×20列”的大型矩阵,以便进一步开展低温续驶里程分析。
CLTC-P速度曲线涵盖多种指标,如加减速、匀速、怠速和所占的时间比例、最大速度、平均速度、平均加速度以及相对正加速度,这些指标通常是构建工况的主要研究对象。指标中如速度与加速度之间会存在信息交叉,过度选取指标会将工况复杂化,不利于工况的构建。采用主成分分析法可以实现指标降维,降低计算与分析难度。
一般情况下,原始输入数据矩阵的大小为i×ji为原始样本量,j为指标数量,得到的矩阵用M表示:

式中:Mx×yx=1,2,3…,iy=1,2,3…,j)为第x个行驶片段中的第y个指标。
将指标参数进行标准化处理,通过迭代算法就能够得到主成分的特征值与贡献率,最终确定速度相关参数的主成分。研究指出[14-16],经主成分分析后,行驶车辆的平均速度、平均行驶速度、最大速度和运行时间等指标的累计贡献率约80%,足够表征速度的大部分信息。电动汽车不存在怠速工况,车辆行驶速度v小于0.5 km/h且加速度a小于0.15 m/s2即判定车辆近似停车状态。在原始大数据库中不予分析该状态,忽略平均速度,只考虑平均行驶速度。将上述指标作为大数据分析中速度部分的主要参考依据,实现原始大数据矩阵的降维处理。
低温续驶里程工况速度曲线依托CLTC-P的曲线基本特征进行建立,包含低速、中速和高速3种路况类型,其主要特征见表2
基于前文主成分分析选取的速度相关指标,采用聚类分析算法对运动学片段进行分类。将云端大数据中的速度相关参数按照低速、中速和高速将具有相同速度特征的运动学片段分为3个聚类,工况集合为X=[x1x2x3…,xm],根据标准确定3个聚类中心Cnn=1,2,3),通过迭代算法使每个聚类到各自聚类中心的欧式距离平方和D最小:

式中:m为提取工况片段数量。
通过聚类分析,提取出3类运动学片段的工况数量如表3所示。从表3中可以看出,低温环境下电动汽车低速行驶片段数占比最高,占总行驶数的62.3%;中速行驶片段次之,占比为25.9%;高速行驶片段最少,占比为11.8%。
从云端大数据库中经聚类分析获取的运动学片段存在毛刺,车辆速度不能直接使用,经B样条平滑处理以后形成连续可导的规则速度曲线,得出的3类运动学片段示例如图2所示。
电动汽车在低温与常温下的速度特征是否存在差异需要进一步验证。从云端大数据中提取速度指标,为控制变量,在大数据提取东北地区中的常温车辆时,尽量包含前文分析的低温车辆,避免用户驾驶行为差异。车速总体范围控制在0~150 km/h,以1 km/h为间隔细致划分速度区间,共划分150个速度区间,提取的速度数据点超过1 000万个。通过累积概率密度计算二者之间的速度差异,得出统计概率特征如图3图4所示。
图3所示,当行驶车速低于30 km/h时,低温分布概率要高于常温分布概率;当行驶车速处于30~80 km/h时,低温与常温相比概率略有下降;当行驶车速超过80 km/h,低温分布概率要明显低于常温分布概率。如图4所示,低温与常温的间距先缓慢增大,后减小直至密度为1。低温与常温条件下,电动汽车行驶速度分布的整体区间相同。详细速度划分后发现二者存在着明显差异,与常温条件下相比,电动汽车低温条件下低速行驶时间明显偏多,而中速与高速行驶时间明显减少。因此在开展电动汽车低温续驶里程试验时,应该增加低速段试验时间,减少中速段与高速段试验时间。
云端大数据提取中剔除了速度近似为0的数据,只考虑用户车辆的车速>0 km/h的行驶状态,因此在低温续驶里程工况的构建过程中,保持原有CLTC-P车速为0 km/h的运动学片段的分布情况与持续时间,只改变行驶速度的分布。低温续驶里程工况的速度曲线构建过程如图5所示。
低温速度曲线的构建以CLTC-P曲线为基础,先将CLTC-P速度曲线切片,暂时移除车速为0 km/h的运动学片段,接着计算低速、中速与高速行驶片段的权重分布和持续时间,随后利用低温与常温速度分布的概率差异,重塑低速、中速与高速工况的持续时间,重新计算出新的低速、中速与高速三种速度段曲线分布,再重新将车速为0 km/h的运动学片段添加进去,最终建立电动汽车在低温下的速度曲线。计算后的低速、中速与高速的时间占比分布如表4所示,构建的电动汽车低温续驶里程速度曲线如图6所示。
在原始的CLTC-P速度曲线中,中速行驶部分持续时间最长、占比最高,为39%。经云端大数据计算速度概率分布后,电动汽车在低温时的速度曲线当中的低速行驶部分持续时间最长为40%。相比CLTC-P而言,低温速度曲线的低速持续时间提高了3%,中速持续时间降低了2%,高速持续时间降低了1%,平均行驶速度下降了1.7%,总行驶时间保持不变。
目前低温续驶里程试验温度标准规定为(-7±3)℃,考虑到东北地区冬季的实际温度特征,标准规定温度无法满足用户的实际需求,同时标准中给出的空调设置较为笼统,不能作为具体的试验方法。云端大数据库中,每一时刻的采点是多维度的,能够同时记录速度、环境温度与空调设置参数。本章依据前文云端大数据获取的运动学片段,开展低温条件下环境温度与空调设置参数等维度的分析。
云端大数据分析的车辆环境温度基本处于-15 ℃及以下,经统计分析后得出的环境温度分布如图7所示。运动学片段的整体环境温度分布在[-33,-15]℃之间。整体趋势而言,环境温度越低、其占比也越低。根据统计分析的结果,当环境温度为-15 ℃时占比最高为19.13%,当环境温度为-32 ℃时占比最低为0.17%。当环境温度≥-22 ℃时,占整体的百分比为95%;当环境温度处于-24 ℃及以上时,占整体的百分比为98%。根据本文的工况建立标准,当环境温度截止至-22 ℃时即可代表95%用户的低温驾驶环境,该温度远低于现有标准设置的低温试验环境温度。
受限于云端大数据埋点位置,大数据中暂时能够提供用于低温续驶里程试验工况建立的空调设置参数主要有2种,分别是空调等级与空调温度。空调等级体现了空调系统吹风的档位高低,数值越大代表吹风量越高,空调温度则代表了空调系统的设置温度,不能代表车内的实际温度。根据运动学片段的多维度信息,建立环境温度-空调等级-空调温度三维关系,分别计算3者间的相关性系数,判断空调设置参数是否与环境温度有关。
图8所示,不同环境温度下的空调等级与空调温度分布带较宽。当环境温度为-15 ℃时,空调温度处于22~32 ℃时,空调等级范围为0~7;当环境温度为-33 ℃时,空调温度处于26~32 ℃时空调等级范围为3~7。虽然从整体趋势而言,当用户所处的环境温度较低时,空调等级和空调温度设置趋于高能耗,但分布图中的关系曲线波动十分强烈,同一环境温度下的空调设置几乎涉及全部空调等级范围与空调温度范围,关系图中的环境温度与空调设置相关性较弱。
相关系数计算结果如表5所示,环境温度与空调等级的相关系数为-0.218,相关性极弱;而环境温度与空调温度的相关系数仅为0.002,二者几乎不存在相关性;同时空调等级与空调温度之间的相关性也微乎其微。
因此可以给出结论,环境温度与空调设置之间不存在关联性,在分析空调设置时不需要考虑当前环境温度的具体数值,低温条件下空调设置参数与环境温度无关。据此,根据运动学片段统计分析车辆行驶过程中空调等级与空调温度的分布情况。
图9所示,根据统计结果,空调吹风等级的分布等级处于0~7之间,0等级的占比最低,即低温状态下几乎没有不开空调的用户。随着空调等级的增长,其等级占比先增大,用户采用吹风等级为3的占比最高为34%,随后空调等级的占比随空调等级的增长而下降。
为了统一试验标准,按照各个等级的比例分布进行加权求和,得到低温工况空调等级L

式中:liCi为大数据中的空调等级及对应比例,求得空调等级L为3.28,即低温续驶里程试验中空调设置等级为3,不管在用户比例还是在标准统一性,在低温续驶里程试验中都更具有代表性。
图10所示,空调温度分布较为分散,随机性较强,用户采用32 ℃的情况最多,占比24.7%,空调温度为22 ℃、26~29 ℃、31~32 ℃之和占整体的95.0%,由于数据分散性较强无法直接建立空调设置温度,因此仍需要通过加权计算来统一规范空调温度标准,获取空调设置温度T:

式中:ti为大数据中的空调温度,Di为其对应比例,求得空调设置温度T为26 ℃,即开展低温续驶里程试验时,车内空调温度统一设置为26 ℃可以代表用户空调温度的平均设置情况。
本文根据电动汽车用户云端大数据信息,应用主成分分析和聚类分析方法获取了低速、中速和高速的运动学片段,通过大数据计算电车在常温与低温下的速度差异,建立了适用于低温续驶里程试验的速度曲线。针对现有低温续驶里程试验条件不足的问题,在大数据中提取了环境温度、空调等级与空调温度等维度信息,分析出环境温度与空调设置不存在关联性,计算出适用于低温试验的环境温度和空调设置信息,确立了低温试验工况的基本条件,构建了较为完整的电动汽车低温续驶里程工况。
与传统的工况建立方法不同,此次工况建立使用的车辆数据全部来自于用户大数据,维度信息齐全,路况信息广泛,驾驶行为特征充分,形成数据点过亿的原始超大型矩阵,应用降维手段将样本量精简,提取到工况建立所需的维度信息。通过大数据的清洗、计算与分析,大幅缩短了工况建立周期,提升了工况的准确度性与代表性,能够高度还原大部分用户驾驶场景,首次将大数据分析方法应用到试验工况当中,为试验工况建立提供新思路。
研究后续开展了基于本文大数据分析的低温续驶里程工况对照试验,包含环境仓台架试验与冬季低温道路实测2部分,并通过云端数据计算出了用户低温续驶里程与车辆电耗,比较后发现,大数据计算结果与试验结果高度吻合,成功验证了云端大数据分析的可行性以及工况建立的准确性。该工况逐步应用到后续电动汽车开发的续驶里程测试当中,形成低温续驶里程试验标准。
