Based on the actual operating data of electric vehicles, this paper proposed an analysis method of in-service power battery usage behaviors, so as to quantitatively evaluate the charging behaviors and driving behaviors of vehicles, and provide effective support for battery fault diagnosis. Firstly, characteristic parameters of power battery use behaviors based on membership function were extracted, and then the accumulative risk score of using behaviors was defined and calculated. Finally, the battery use behavior differences between vehicles and vehicles in different time dimensions were quantitatively analyzed by using the idea of horizontal and vertical comparison. Experimental results show that there is a strong positive correlation between the battery using behavior score quantified in this paper and battery pack consistency, which can fully evaluate the using behavior of power battery, and provide data support for battery fault diagnosis.

为定量评估电动汽车用户的充电习惯和驾驶习惯,为电池故障诊断提供有效支撑,基于电动汽车的实际运行数据,提出了一种在役动力电池使用行为的分析方法。提取基于隶属度函数的动力电池使用行为特征参数,定义并计算出使用行为所累积的风险,即使用行为分数,并采用横、纵向对比的思想定量分析了单车在不同时间维度以及车车之间的电池使用行为差异。试验结果表明,获得的电池使用行为分数与电池组电压一致性存在强正相关性,可以充分评估动力电池使用行为,为电池故障诊断提供数据支撑。

为定量评估电动汽车用户的充电习惯和驾驶习惯,为电池故障诊断提供有效支撑,基于电动汽车的实际运行数据,提出了一种在役动力电池使用行为的分析方法。提取基于隶属度函数的动力电池使用行为特征参数,定义并计算出使用行为所累积的风险,即使用行为分数,并采用横、纵向对比的思想定量分析了单车在不同时间维度以及车车之间的电池使用行为差异。试验结果表明,获得的电池使用行为分数与电池组电压一致性存在强正相关性,可以充分评估动力电池使用行为,为电池故障诊断提供数据支撑。

Based on the actual operating data of electric vehicles, this paper proposed an analysis method of in-service power battery usage behaviors, so as to quantitatively evaluate the charging behaviors and driving behaviors of vehicles, and provide effective support for battery fault diagnosis. Firstly, characteristic parameters of power battery use behaviors based on membership function were extracted, and then the accumulative risk score of using behaviors was defined and calculated. Finally, the battery use behavior differences between vehicles and vehicles in different time dimensions were quantitatively analyzed by using the idea of horizontal and vertical comparison. Experimental results show that there is a strong positive correlation between the battery using behavior score quantified in this paper and battery pack consistency, which can fully evaluate the using behavior of power battery, and provide data support for battery fault diagnosis.

锂离子电池因其高能量密度、长使用寿命等特点而广泛应用于新能源汽车[1]。电池的健康状态(State Of Health,SOH)和安全风险除与电池品质、制造工艺等有关[2],还与电池的使用行为相关。动力电池的不良使用行为,如大倍率充放电、过充、过放等会增加电池析锂风险,严重影响电池使用安全[3]。用户的用车习惯不同,使得电池实际使用工况不同,电池安全风险的累积也有所差异。分析动力电池实际使用工况,合理评估动力电池使用行为,可以为动力电池故障诊断提供支撑。
目前,针对车载动力电池实车数据的相关研究主要是基于电池机理的内短路识别。利用电池系统机理建立适用于实车运行数据的内短路识别算法,可实现电池故障早期预警。Cong[4]使用广义无量纲指标构造公式提取了电池内短路关键信号特征,并通过稀疏聚类方法检测异常信号,该方法在电池内短路发生早期即可识别并预警。Jiang[5]通过状态表征算法表征电池系统状态与当前监测数据的关系,从而识别异常数据。状态表征算法使用标准化的电池电压代替原始电压,使得异常状态表现更加显著,提高了对微短路的识别性能。基于机理的内短路识别对数据质量要求高,无法彻底排除由数据传输错误造成的数据异常,导致该类型方法的误报率较高。要排除此类数据异常,需要从系统级别分析电池全生命周期数据变化信息。
为了解决非故障因素导致的数据异常,本文从系统级别分析电池全生命周期数据分布,基于隶属度函数评估电池使用行为,并通过电池组电压一致性对比分析,验证该方法的有效性。
电池使用行为分析流程如图1所示,包括数据输入、数据预处理、特征参数定义与计算、统计分析、评分计算5个部分。
本文所用数据为某地区4辆同型号纯电动汽车2021年6~12月期间的使用数据,采集的参数如表1所示。
数据预处理包含数据清洗、数据段划分。数据采集过程会受到各种因素干扰,导致数据出现异常,数据清洗过程需要对异常数据进行平滑处理,以提高数据质量。从原始数据中寻找数据的阶段性变化,需要对原始数据进行数据段划分。充电过程和放电过程数据段划分的标准有所区别。充电过程通常是连续的,每个数据段为一个完整的充电过程。放电过程随机性较强,通常不具有连续性,故每个放电数据段时长设为60 s。
为了从全生命周期长度描述电池的使用行为、发现电池使用行为的统计规律,需要定义一系列与电池实际运行工况相关的特征参数。动力电池充、放电过程中环境变量和运行工况有显著区别。在充电过程中,汽车处于静止状态,电流、SOC与用户充电习惯高度相关;在放电过程中,汽车处于运动状态,其电流的变化情况与驾驶习惯高度相关,波动剧烈。因此,特征参数的定义需要分别考虑,本文定义的特征参数如表2所示。值得注意的是,充、放电状态下电压参数整体变化趋势均较缓慢,仅通过电压无法区别不同车辆的使用行为差异。因此,本文未选取电压描述电池使用行为特征。
充电过程中,电流多为阶梯充电模式,需要统计不同充电电流在不同SOC区间的持续时间。放电模式下电动汽车状态变化频繁,包括加速、减速、匀速、停车,在电池端表现为电流变化剧烈。
为了从系统级别描述电池的使用行为,需要对特征参数进行重组、提炼、统计,得到关于电池系统使用行为的全局信息。电池使用行为的统计主要从放电行为、充电行为2个方面进行。对统计结果可视化分析得到车辆间使用习惯的差别,以此作为电池故障诊断的输入信息。
电池放电过程以电流为变量间接描述车辆状态。动力电池功率状态为:

式中,PUI分别为电池组的功率、电压、电流;F为汽车行驶驱动力;m为整车质量;v为汽车行驶瞬时速度;t为时间。
由开路电压(Open Circuit Voltage,OCV)-SOC特性曲线可知,在极小SOC区间内电压变化可忽略不计,则有:

通过电池运行工况的初步分类可以了解到该车辆整体驾驶习惯。由式(4)可知,电流的变化率与加速度的平方以及车速的二阶微分呈现正相关。当车辆处于停车状态或匀速行驶状态时,电流变化率应为0。考虑到车辆在停车状态下车内用电设备仍会产生电能消耗,故认为电流长时间(超过6个采样间隔)维持在0~4 A范围内时车辆处于停车状态。由式(3)、式(4)可知,车辆处于加速状态时,电流为正值,电流变化率为正值。同理,车辆处于减速状态时,电流为负值或在上一阶段处于平稳状态,当前阶段突然开始减小。即电流为负值时,识别为减速状态,在上一阶段判断为匀速行驶,当前阶段电流变化率开始为负,则识别为减速状态。电流维持在某一特定范围(<4 A)时,识别为匀速行驶状态。使用箱型图法对电动汽车云端大数据平台的车辆驾驶信息进行统计分析,选取处于第50百分位的车辆作为分析对象。该车辆在驾驶使用周期内一半以上的时间处于停车状态。加速时间较减速时间稍多,而在非停车状态下匀速行驶状态持续时间最长,且该车辆大部分时间为短途驾驶。
通过对电流数据聚类分析,能更加详细地描述电池输出工况的分布情况,本文使用K-Means聚类算法进行分析。对于给定的样本集,按照样本间距离大小实现最优划分,划分标准为:

式中,E为最小化平方误差;k为样本簇数量;Ci为样本簇;x为样本值;ui为聚类质心。
电流的标准采样间隔为10 s,以6个采样点(1 min)为单位区间对整体数据进行重新划分。在单位区间内提取与电流有关的参数:最大电流Imax、平均电流Imean、电流标准差SCurrent作为聚类算法的输入。
图2展示了放电电流参数的聚类结果。平均电流和电流标准差分别表征了该单位区间内的平均功率和电流变化情况。该结果将电流工况分布情况分为若干类。通过对电流工况的K-Means聚类分析能全面获取该车辆在放电阶段的电流工况分布,并根据每个类别的数量分析其主要工况分布情况。
电池充电SOC区间和充电电流直接反映了车辆的日常充电习惯,分析车辆长生命周期内的充电习惯,可以为电池故障诊断提供数据输入。研究表明,锂电池在充电电流和截止电压超过特定值后,容量衰退速度会显著加快[6]。相较于健康区间,在非健康区间内动力电池容量衰减速度更快。图3展示了电池在充放电周期内的起止SOC分布情况。将SOC划分为A1、A2、A3、A4共4个区域。其中A4为电池健康充电区域,A2为电池充电深度最大的区域。由图3可知,SOC分布最为集中的区域为A3,即该区域为用户习惯充电区域,该区域内SOC大部分超过90%。
进一步描述电池充电行为,需要详细区分不同阶段的充电电流在各SOC区间上的持续时间,统计每个充电周期内不同SOC区间的等效充电次数,定性描述每个充电阶段的充电行为。将SOC区间和电流平均分划为若干个子区间,对不同的充电SOC区间和电流进行区分。由图3所展示的充电次数统计结果可以获取该车辆在不同SOC阶段的充电电流分布、充电电流偏好以及快充区间偏好等全局信息。
电池内部电化学机理复杂,无法直接构建一个确切的数学公式或模型对每个行为进行准确评估。因此,本文构建了符合电池特性的隶属度函数用于描述使用行为参数与评价得分之间的模糊关系。隶属度函数的构建带有主观性,但总体变化趋势需满足客观规律[7]。在现有研究基础上,对电池使用行为构建隶属度函数,模糊地评估电池使用行为,能得到相对准确的评估结果。
车辆驾驶过程中环境变量较为复杂,且目前尚未有明确的试验论证车辆驾驶行为与电池安全性之间的联系。相反,电池充电行为与电池安全性之间的关系已有试验论证,且车辆充电过程参数变化均较小,便于定量评估。因此,本文定量评估电池充电行为,且通过电池电压一致性变化情况验证该评估方法的合理性。
充电行为评估流程如图4所示:
a. 根据SOC、电流数据段划分规则获取SOC序列和电流序列。将SOC区间等分为数量为n的子区间,记为s1,…,si,…,sn;电流依据电流额定值均分为数量为m的子区间,记为i1,…,ii,…,im
b. 统计单个循环周期内,充电电流落在电流子区间和SOC子区间中的次数,得到SOC区间si、电流区间ii的等效充电次数 T s i i i,由等效充电次数、SOC序列和电流序列计算得到等效充电矩阵MC-SOC

c. 构建基于SOC健康区间和电流健康区间的隶属度函数ASOCAC。一般认为电池SOC使用区间在20%~80%范围内为健康区间,小倍率充电为电流健康区间。为了与客观的规律相吻合,SOC隶属度函数应为对称型,电流隶属度函数应为梯形函数。本文构建的SOC隶属度函数和电流隶属度函数分别为:

式中,ASOC(x)为SOC隶属度函数;AC(x)为电流隶属度函数;μ为SOC隶属度函数曲线尖峰中心坐标;σ为标准差。
d. 对2个一维隶属度函数等间隔采样得到子区间隶属度,采样数量对应SOC序列和电流序列。SOC隶属度向量记为(S1,…,Si,…,Sn);电流隶属度记为(I1,…,Ii,…,In)T;评估矩阵MSOC-I=(S1,…,Si,…,Sn)×(I1,…,Ii,…,In)T。根据MSOC-IMC-SOC的计算结果对数据长度加权后得到单个周期的评估得分。
本文分别从使用行为统计和使用行为评估2个角度描述所提出的特征参数和评估方法对在役动力电池使用行为评估的有效性。本文使用的数据为在役车载电池实际使用数据,包含至少200个充放电循环,数据总长度超过106行。
动力电池的故障诊断通常以健康电池和故障电池间的数据差异作为有效的输入信息。在放电模式下,使用K-Means聚类法对电流特征参数聚类,获取每辆车在放电过程中电流工况的整体分布以及每辆车驾驶习惯的差异。在充电模式下,计算每个SOC区间和电流区间的等效充电次数,由此区分不同车辆的充电习惯差异。
图5所示为放电模式下4辆电动汽车的电流参数聚类结果。观察聚类结果中不同类别标记的分布情况,以此评定车辆的驾驶习惯。以图5中的车辆1、车辆2为例:车辆1中每种类型的标记均较为紧凑,聚类效果不明显,即该车辆放电电流数据多集中在0~60 A区间内,由此不难得出,该车辆驾驶较为稳定;车辆2标记较为分散、聚类效果明显,每个数据段内电流参数变化量大,车辆2中1类、2类的数据量较3类、4类稍大,由此可知,该车辆驾驶不确定性大。比较车辆间的参数分布以及数据量的差异,可以获取相同时间内不同车辆驾驶时间和驾驶风格的差异。车辆3在相同时间内的数据量明显较车辆4少,即车辆3的驾驶时长较车辆4短。电流标准差参数表征单位数据段内电流的变化量。通过对比发现,车辆1、车辆3、车辆4的电流标准差均集中在0~40 A区间内,而车辆2有部分时刻标准差超过40 A,由此可以认为,在以车辆1、车辆3、车辆4为参照时,车辆2的驾驶习惯较为激进,产生电池安全风险的概率也更高,在后续诊断过程中该判据可以作为数据支撑。
图6所示为充电模式下等效充电次数分布情况。如表3所示,本次计算将SOC区间0~100%等间隔分为10个子区间,电流区间0~200 A等间隔分为5个子区间。等效充电次数为指定区间内的电流通过SOC子区间的次数。
通过单车统计分析,车辆4充电SOC区间集中在20%~60%,其他SOC区间内数据较少。由此可知,车辆4的充电SOC区间偏好为20%~60%。车辆4充电电流区间分布较为均匀,没有体现出电流大小偏好。而车辆1充电电流全部小于40 A,即该车辆用户偏好小电流充电。车辆2用户偏好80~160 A电流充电,而在40%~60% SOC区间内更偏好使用超过160 A的大电流充电。通过车辆间数据对比,比较处于健康区间内数据量占比,以此评定不同车辆的充电习惯差异。车辆3用户偏好较大的充电电流,且SOC区间偏好包含0~20%,存在过放电风险。综上,车辆3充电产生安全风险的概率更高。
受生产制造工艺的限制,电池组中各电池单体在使用初期即不完全一致。在后续使用过程中,随着电池使用次数增加,电池组一致性会逐渐变化[8],在相同使用次数下,电池组的一致性变化程度可以表征电池使用行为的差别。
本文使用电池组各单体电压的差别代表电池组一致性。使用均方根误差ERMS量化电压一致性:

式中,c为循环次数;N为电池总循环次数;Cn为电池单体数量;T为采样周期;Vtt时刻单体电压; V t ^t时刻平均电压;DV为电压一致性得分;ERMS,c=i为循环次数为i时电压电压一致性计算值。
每辆车的全生命周期充电分数分布如图7所示,分数区间为(0,1),分数越高代表充电行为越健康。车辆1使用行为分数维持在0.72~0.74分范围内,相较于其他车辆分数最高,因为该车辆偏好使用小倍率电流充电,这与前文的分析结果相吻合。电池充电行为评估分数取全生命周期分数的中位数,表4展示了电池电压一致性得分和充电行为评估分数。为验证评估方法的有效性,使用皮尔逊(Pearson)相关系数公式验证2个变量之间的相关性,求得使用行为评估分数与电池电压一致性分数之间相关系数为0.862,变量间为强正相关。结果表明,在本文分析的4辆车中,电池充电行为与电池电压一致性变化之间存在强正相关性,即电池使用行为在健康区间内,电池的电压一致性变化较小,反之,电池电压一致性变化较大。
本文基于实车运行工况数据,提出了使用行为统计分析方法和使用行为评估方法。通过定义的特征参数获取电池实际运行过程的工况信息,统计分析不同车辆的电池充放电习惯差异,为电池故障诊断提供数据支撑。使用行为评估方法能从电池的充电习惯中定量评估充电行为。使用电压一致性指标对使用行为评估方法进行验证,结果表明,电池充电行为与电池电压一致性之间存在强正相关性。由于数据量的限制,隶属度函数的构建还有进一步优化的空间。K-Means聚类过程需要提高数据量以构建更为精确的分类结果与使用行为间的映射关系。在获取新的数据后,将对该方法进行优化,提高其在不同车型数据之间的泛化能力。由于温度传感器的精度限制,本文尚未考虑到温度与电流参数的耦合关系。在后续研究中,会将温度因素纳入评估方法,结合试验测试,重新构建电池使用行为评估方法。
