In order to solve the problem of inaccurate subjective evaluation of vehicle driving and the inability of objective evaluation to reflect subjective feelings, an evaluation model based on Stacking ensemble learning method is proposed. First, the acceleration condition characteristics of vehicles are studied and objective evaluation indicators of driverability are defined. Then the evaluation indicators are used as input features to train the Stacking ensemble model. Moreover, the Improved Harris Hawk Optimization algorithm was used to optimize the hyperparameters in the Stacking ensemble model to improve the model prediction performance. Finally, the road test proves that the performance of the HHO-Stacking ensemble model is superior to that of a single machine learning model. The qualification rate of the HHO-Stacking ensemble model is 95%. The HHO-Stacking ensemble model can complete the drivability evaluation more effectively.

为解决车辆驾驶性主观评价一致性差及客观评价无法反映主观感受的问题,提出了一种基于堆叠(Stacking)集成学习方法的评价模型,首先研究了车辆加速工况特性,定义了工况驾驶性客观评价指标,使用评价指标作为输入特征训练Stacking集成模型,并且使用改进的哈里斯鹰优化(IHHO)算法优化了Stacking集成模型,提高了预测性能。最后通过道路试验表明,IHHO-Stacking集成模型的性能均优于单个机器学习模型,IHHO-Stacking集成模型预测合格率达95%,能够更有效完成驾驶性评价。

为解决车辆驾驶性主观评价一致性差及客观评价无法反映主观感受的问题,提出了一种基于堆叠(Stacking)集成学习方法的评价模型,首先研究了车辆加速工况特性,定义了工况驾驶性客观评价指标,使用评价指标作为输入特征训练Stacking集成模型,并且使用改进的哈里斯鹰优化(IHHO)算法优化了Stacking集成模型,提高了预测性能。最后通过道路试验表明,IHHO-Stacking集成模型的性能均优于单个机器学习模型,IHHO-Stacking集成模型预测合格率达95%,能够更有效完成驾驶性评价。

In order to solve the problem of inaccurate subjective evaluation of vehicle driving and the inability of objective evaluation to reflect subjective feelings, an evaluation model based on Stacking ensemble learning method is proposed. First, the acceleration condition characteristics of vehicles are studied and objective evaluation indicators of driverability are defined. Then the evaluation indicators are used as input features to train the Stacking ensemble model. Moreover, the Improved Harris Hawk Optimization algorithm was used to optimize the hyperparameters in the Stacking ensemble model to improve the model prediction performance. Finally, the road test proves that the performance of the HHO-Stacking ensemble model is superior to that of a single machine learning model. The qualification rate of the HHO-Stacking ensemble model is 95%. The HHO-Stacking ensemble model can complete the drivability evaluation more effectively.

由于驾驶性主、客观评价分离,不能有效评价车辆驾驶性,为此国内外学者开展了大量的研究与分析,机器学习算法逐渐成为驾驶性评价的主流评估方法。Chandrasekaran等提取了加速延迟、加速度振动剂量、加速度峰值等客观指标与主观评分进行线性回归分析,完成了SUV车型的驾驶性评价[1]。Huang等人利用粒子群算法优化机器学习方法,建立了主观评分与客观评价指标的映射关系,能够预测车辆驾驶性主观评分[2]。刘海江等人利用粗糙集理论提高支持向量机预测精度,评估驾驶性评价指标重要程度[3]。上述研究均采用单一的机器学习方法构建预测模型,但单一的模型泛化能力较弱,超参数难以调整,预测效果不佳。
为解决上述问题,本文引入堆叠(Stacking)集成学习方法构建预测模型,以此整合不同类型的机器学习算法,发挥每个模型的优点[4]。本文以搭载了无级变速器(Continuously Variable Transmission,CVT)车辆的加速工况为例,首先研究加速工况驾驶性客观评价指标的定义与计算方式,其次利用Stacking集成模型对客观评价指标数据进行学习训练,通过改进的哈里斯鹰算法(Improved Harris Hawk Optimization,IHHO)对所建立的Stacking集成模型中的每一个基学习器进行超参数寻优,以获得最佳的预测结果,然后将本文提出的IHHO-Stacking集成模型的预测性能和预测结果同基学习模型进行比较,验证IHHO-Stacking集成模型的预测精度,最后利用IHHO-Stacking集成模型对国内某主机厂2款试验车及一款对标车的加速工况驾驶性进行评估。
为使试验数据以及后续结果具有普遍性,选择市场应用普遍的10款搭载CVT的紧凑车型进行驾驶性试验,试验场地为国内某主机厂封闭路段,试验条件为晴朗天气、干燥沥青路面,其余条件与GB/T 12534—1990《汽车道路试验方法通则》一致。试验设备为AVL数据采集仪以及配套软件与传感器。为更好测量加速度信号,传感器安装在驾驶位头枕处、车辆质心处以及左前轮半轴上,其余信号通过CAN总线读取,具体设备安装如图1所示。
加速工况是指在车辆平稳运行以后,驾驶员意图提高车速踩下加速踏板达到目标开度后,车辆纵向动力性得到提升的过程。为更好地反映车辆的驾驶性能,本次驾驶性试验将加速工况分为全负荷工况和部分负荷工况[6]。其中部分负荷工况加速踏板开度为20%、25%、30%、40%、50%、60%、70%、75%、80%、90%,全负荷工况加速踏板开度为100%。其中100%开度使用D挡和S挡进行试验,其余开度均采用D挡进行试验。试验开始时,在D挡或S挡以低于10 km/h的车速平稳运行至少2 s,然后以预定的加速踏板开度加速,直至车速大于120 km/h或加速度为0 m/s2时试验结束,每种开度测试2次,由专业评车师为车辆驾驶性打分。
在车辆行驶过程中,加速工况是最为常见的行驶工况,当驾驶员踩下加速踏板时,车辆需要满足驾驶员所期望的动力响应,但由于过快的动力响应会带来平顺性降低的问题,因此从响应特性和平顺特性2个维度来确定相关指标[7-8]。本文结合国内外学者研究,确定具体指标如表1所示。
a. 响应延迟时间。驾驶员从踩下加速踏板到车辆有明显加速度所需时间,表征车辆起步加速响应能力[7],其表达式为:

b. 最大加速时间。驾驶员从踩下加速踏板到车辆达到最大速度所需时间,表征车辆加速工况完成效率,其表达式为:

c. 峰值加速度。驾驶员踩下加速踏板后,加速工况所能达到的最大加速度,表征车辆最大加速能力,其表达式为:

d. 最大冲击度。驾驶员在踩下加速踏板后,车辆加速度变化快慢表征车辆在加速行驶过程中,驾驶员所受到的最大冲击,其表达式为:

e. 加速度平均值。加速度与最大加速时间的结合,表征为车辆加速过程中的动力性能,其表达式为:

f. 加速度均方根。当车辆加速度达到峰值以后,加速度出现的低频振荡,表征驾驶员在车辆中所受到的轰鸣与抖动,其表达式为:

g. 加速度冲击剂量值。与平顺性中的振动剂量值定义类似,表征车辆在加速过程中冲击累计量,其表达式为:

i. 起步加速时间。驾驶员踩下加速踏板后,车速从0到40 km/h所需时间,表征为车辆在市区拥堵路段的加速能力,其表达式为:

j. 行驶加速时间。驾驶员踩下加速踏板后,车速从40 km/h升至80 km/h所需时间,表征车辆在市区开阔路段的加速能力,其表达式为:

机器学习模型的超参数会影响模型泛化性能和预测准确度,为了获得性能良好的预测模型,利用哈里斯鹰优化(Harris Hawk Optimization,HHO)算法多轮次进行全局搜索和局部开采的切换来寻找最优超参数,哈里斯鹰算法模拟老鹰抓捕兔子的过程,该算法设置一个逃脱能量因子E,当|E|≥1时,会进入全局搜索状态,反之则会进入局部开发,其表达式为:

当|E|≥1时,哈里斯鹰进行全局搜索,以2种概率均等的策略进行狩猎,其公式为:

式中:X(u+1)为哈里斯鹰更新后的位置,X(u)为哈里斯鹰初始位置;Xran(u)为种群中随机个体位置;Xpre(u)为最优个体位置,即猎物的位置;r1~r4均为(0,1)的随机数;ublb为种群的上下界;q为随机数,表示等概率选择2种狩猎策略;Xm(u)为当前种群平均位置;N为种群个数。
若|E|<1时,即发现猎物,HHO算法会以4种策略更新位置来捕获猎物,通过逃脱能量|E|和一个取值范围为0~1的随机数r来模拟猎物行为,HHO算法根据这2个参数来使用位置更新策略。
策略一:当|E|≥0.5且r≥0.5时,猎物有足够的逃脱能量,但是没有逃脱机会,哈里斯鹰个体会通过软包围消耗猎物能量,其位置更新公式为:

式中:ΔX(t)为猎物和哈里斯鹰位置的间距,r5为0~1的随机数,J为猎物逃跑过程中的跳跃距离。
策略二:当|E|<0.5且r≥0.5时,猎物既没有足够的逃脱能量,也没有逃脱机会,哈里斯鹰会迅速捕获猎物,其位置更新公式为:

式中:Y为第一个捕猎方式,Z为第二个捕猎方式,D为空间维度,SD维随机行向量,LF为莱维飞行函数,f为适应度函数。
策略四:渐进式俯冲硬包围。当|E|<0.5且r<0.5时,猎物没有足够的逃脱能量,但是有机会逃走,哈里斯鹰也会采用2种策略捕猎,其位置更新公式为:

HHO算法仍存在缺陷,首先该算法多样性不足,收敛速度慢,易陷入局部最优解,其次逃离能量因子是线性变化的,迭代后期只进行局部搜索,易陷入局部最优解,故提出如下改进方法:
a. Tent混沌映射。为增加算法初始种群的多样性,引入具有遍历性、随机性的混沌系统,改善算法的寻优能力和收敛速度,本文利用混沌映射调整HHO算法随机参数r[9],其公式为:

式中:ri为(0,1)范围内的随机数(i=1,2,3,4,5)。
b. 逃脱能量因子非线性调整。逃脱能量因子从全局探索到局部开发呈线性递减,曲线变化如图2a所示。在迭代后期不会进行全局探索,容易陷入局部最优解,需要对式(11)进行非线性调整,让整个迭代过程都可以进行全局搜索,改进的公式为:

式中:E1为改进后的能量因子,E0为(-1,1)范围内的随机值,ea为常数。
在改进的公式中,改进后的能量因子全局搜索与局部开发过渡更加平滑、分布更加均匀,在迭代后期保留了进行全局搜索的可能。
Stacking算法是一个整合多个机器学习方法的分层框架[10]。本文的分层框架包括2层,第一层由独立机器学习模型组成,每个模型称为基学习器,第二层由元学习器整合基学习器结果输出最终结果,基学习器应该选择不同特征的模型来提高多样性,防止过拟合。Stacking算法中的可选择的基学习器包括:人工神经网络(Artificial Neural Network,ANN),是一种模拟人脑神经元的信息处理系统,有较强的非线性函数逼近能力;极限梯度提升树(Extreme Gradient Boosting,XGBoost),是对梯度提升树的优化,在保证精度的前提下,提升了计算速度并且防止了过拟合;随机森林(Random Forests,RF),是一种多种决策树联合的集成学习,改善了单一决策树的缺陷,模型具有更高的泛化能力和准确性;轻量梯度提升机(Light Gradient Boosting Machine,LightGBM),是一种对梯度提升树模型的优化,降低了内存的使用,提升了运算速率;CatBoost,是一种对称决策树算法,具有易调参、准确率高等优点;支持向量回归(Support Vector Regression,SVR),是一种适用于小样本数据的回归算法,利用核函数解决了非线性样本分离的问题。本文Stacking集成模型选择以上6种机器学习模型作为基学习器,第二层元学习器选择线性回归。
Stacking集成学习方法,以6个基学习器作为第一层学习器,元学习器作为第二层学习器,通过五折交叉验证法分别训练各个基学习器,将第一层学习器的输出结果作为第二层学习器的输入特征,原始数据集的输出作为新的输出组成数据集,以此新的训练集来训练元学习器得到最终结果。Stacking算法运算步骤如下:
a. 将原始数据集以80%∶20%的比例划分为训练集与测试集。
b. 将训练集划分为5个子集,分别为t1~t5,利用五折交叉法训练各个基学习器。
c. 在第一折交叉验证中,t1~t4作为训练集,训练一个基学习器模型,训练后的模型记为M1,将t5作为测试集输入到模型M1中,得到结果v1
d. 依次类推,在第二折交叉验证中,t1~t3t5作为测试集,得到模型M2,将t4作为测试集,得到结果v2,经过五折交叉验证后最终得到结果v1~v5,取平均值记为V1
e. 将原始数据集划分出来的测试集输入到训练好的模型M1~M5,得到结果r1~r5,取平均值记为R1
f. 6个基学习模型重复以上步骤b~步骤e,得到训练集上的预测结果V1~V6和在测试集上的预测结果R1~R6,预测结果作为输入特征,原始数据集输出作为新的输出组成新的训练集与测试集。将新的训练集与测试集输入到二级学习器得到最终结果。
Stacking集成模型框架如图3所示。
根据2.1节所述操作对10款搭载CVT的紧凑车型F1~F10进行道路试验,共获得240组原始数据,经过筛选,获得225组有效数据。试验过程中由3位专业评车师对工况进行主观打分,主观评价标准采用SAE J1441《车辆操控主观评定量表》,主观评价结果取平均值记录,如图4所示。
采集所得的有效数据根据2.2节各公式计算客观指标,客观指标作为输入特征,主观评分作为输出组成初始数据集,数据集以80%∶20%的比例划分为训练集与测试集,为避免客观指标与主观评分数量级差距过大,需要对数据进行归一化处理,具体公式如下:

式中:xi为第i个初始数据,xmin为初始数据序列中的最小值,xmax为初始数据序列中的最大值。
本文采用IHHO算法优化各基模型的超参数,根据各基模型的拟合性能,选择不同的超参数以及寻优范围,以均方根误差作为适应度函数,得到各基模型的最优超参数,如表2所示。
根据3.3.2节集成学习方法原理和IHHO算法构建IHHO-Stacking集成模型,测试集在Stacking集成模型上的预测结果如图5所示。由图5可以看出,模型的预测结果与主观评分趋势基本吻合并且分值也较为相似,说明IHHO-Stacking集成模型可以较准确地预测车辆驾驶性评分。
为了进一步验证Stacking集成模型的预测结果和泛化性能,将单个经过IHHO算法优化的基学习模型、未经IHHO算法优化的Stacking集成模型与IHHO-Stacking集成模型进行对比分析,如图6所示。表3为各个模型的性能评价指标,性能评价指标选取决定系数(R2),均方误差(Mean Square Error,MSE),平均绝对误差(Mean Absolute Error,MAE)3项。R2数值越大,MSE、MAE数值越小,模型性能越好。
结合图6表3可以看出,单个基学习模型的预测结果较为发散,并且R2均小于IHHO-Stacking集成模型,而MSE、MAE均大于IHHO-Stacking集成模型。因此,IHHO-Stacking集成模型的预测性能和泛化能力均高于单个学习模型,IHHO-Stacking集成模型在预测车辆驾驶性方面比单个机器学习模型更可靠。并且IHHO-Stacking集成模型各项性能指标优于未经IHHO算法优化的Stacking集成模型,证明IHHO算法优化有效。
根据SAE J1441,以预测误差小于0.5作为预测模型合格的标准,测试集在IHHO-Stacking集成模型上的预测误差如图7所示。从图中可观察到随机划分的测试集在IHHO-Stacking集成模型合格率为95%。证明本文所选取的客观评价指标能表征车辆驾驶性,所建立的预测模型能够准确预测驾驶性评分。
对国内某主机厂的2款紧凑试验车型A1、A2和一款对标车B进行驾驶性试验,采集25%、50%、60%、75%、100% 5个油门开度下的加速工况原始数据,通过IHHO-Stacking集成模型得到评价结果,各车辆驾驶评分如图8所示。从图中可观察出,试验车A2各开度油门驾驶评分已超过对标车B,试验车A1全负荷加速工况驾驶性达到对标车标准。部分负荷加速工况驾驶性弱于对标车,需继续优化。
本文通过道路试验,研究了CVT紧凑车型加速工况驾驶性,定义了一套有效的加速工况驾驶性客观评价指标,以此为基础建立了IHHO-Stacking集成模型,通过试验验证了所构建的模型预测合格率为95%,预测准确度较高,可以有效评价CVT紧凑车型加速工况的驾驶性,并且使用本文所建立的预测模型完成了3款车加速工况的驾驶性评价。评价结果表明,试验车A2各油门开度下的加速工况评分均超过对标车B,驾驶性良好;而试验车A1仅100%油门开度评分与对标车B持平,需要进行优化。
