Aiming at the issue of lacking slope information in urban driving cycles used for vehicle performance evaluation, this paper proposes a method for Urban Ramp Driving Cycle (URDC) construction based on Self-Organizing Map (SOM) neural network. Typical road driving data with urban ramp characteristics is collected using the average traffic flow method. After pre-processing, the data is segmented into short trips, and 20 parameters representing road operation characteristics are selected as the feature parameters of the short trips. The dimensionality of these feature parameters is then reduced via principal component analysis, followed by clustering the short trips analysis using a SOM neural network. According to the principle of smooth ramp connection, short trips with high correlation are selected to construct an urban ramp driving cycle that includes both speed and slope information. The results of automatic transmission operated in slope performance test indicate that the constructed driving cycle can reflect the driving characteristics of vehicles on road with urban ramp features, which can be used as the benchmark driving cycle for performance test of vehicle driving on urban ramps.

针对车用性能评价的城市行驶工况缺乏坡道信息的问题,提出了一种基于自组织映射(SOM)神经网络的城市坡道行驶工况构建方法。采用平均车流法采集具有城市坡道特征的典型道路行驶基础数据,将预处理后数据划分短行程,选取20个表征道路运行特征的短行程特征参数;利用主成分分析法对特征参数降维,使用SOM神经网络对短行程进行聚类分析;基于坡道平滑衔接的原则,选取相关度较高的短行程,并构建包含速度、坡度信息的城市坡道行驶工况。自动变速器坡道性能测试结果表明:所构建工况能够体现车辆在具有城市坡道特征道路的行驶特性,可作为车辆城市坡道行驶性能测试的基准工况。

Aiming at the issue of lacking slope information in urban driving cycles used for vehicle performance evaluation, this paper proposes a method for Urban Ramp Driving Cycle (URDC) construction based on Self-Organizing Map (SOM) neural network. Typical road driving data with urban ramp characteristics is collected using the average traffic flow method. After pre-processing, the data is segmented into short trips, and 20 parameters representing road operation characteristics are selected as the feature parameters of the short trips. The dimensionality of these feature parameters is then reduced via principal component analysis, followed by clustering the short trips analysis using a SOM neural network. According to the principle of smooth ramp connection, short trips with high correlation are selected to construct an urban ramp driving cycle that includes both speed and slope information. The results of automatic transmission operated in slope performance test indicate that the constructed driving cycle can reflect the driving characteristics of vehicles on road with urban ramp features, which can be used as the benchmark driving cycle for performance test of vehicle driving on urban ramps.

目前,国内外车用性能测试基准的行驶工况多采用速度-时间曲线表达,由于缺少坡道信息,难以反映车辆在坡道特征道路上的行驶特性,进而影响车辆坡道行驶性能评估结果的准确性[1-3]。我国山地、高原国土面积占比近60%,位于此类地区的城市交通具有明显的坡道特征,因此,城市坡道行驶工况(Urban Ramp Driving Cycle,URDC)的构建具有重要意义。构建行驶工况常使用基于马尔可夫链和K均值聚类等方法。在基于马尔可夫链的方法方面,Yang等[4]基于驾驶数据采用马尔可夫链构建行驶工况,设计了多时间尺度的车速预测模型;姜平等[5]结合马尔可夫链与相似性检验方法,构建合肥城区道路环境下的行驶工况;Topić等[6]提出了基于四阶马尔可夫链的多维行驶工况综合方法,验证了系列特征参数误差,生成的合成行驶工况与实测工况的统计特征分布一致性高。基于马尔可夫链的方法,由于短行程起始段选择无统一标准,导致计算难度增加,计算效率下降。
在K均值聚类方面,龚文轩[7]运用基于K均值优化的聚类分析,构建了试验城市乘用车的行驶工况,提高了该工况模型的精度;金思含等[8]结合主成分分析与K-means++聚类算法,构建了符合所在市示范区交通特点的公共汽车的行驶工况;郭家琛等[9]基于K-means++算法聚类,引入评价函数选择聚类种类数,完成了福州市城市汽车行驶工况的构建。K均值聚类对初始值敏感,易收敛于局部最优解,当短行程片段较多时,极易因短行程分类不当导致工况的准确性下降。
除传统聚类方法外,遗传算法、主成分分析等方法同样被应用于行驶工况的开发。孙文等[10]基于实测数据采用数据统计学方法,根据弯道、坡道和限速工况的概率分布生成仿真道路和对应车速变化的概率分布,虽然引入了坡道变量,但车辆行驶工况缺少坡度信息。刘炳姣等[11]结合主成分分析和改进蚁群算法,减少了数据冗余维度,提高模型计算效率。Amirjamshidi等[12]使用多目标遗传算法构建各型卡车行驶工况,但对于特定的排放分析场景,多目标遗传算法调参较为复杂,偏差累积较大。Nesamani等[13]利用实测车辆GPS数据反映真实交通特性,但缺少道路集合参数的集成。
自组织映射(Self-Organizing Map,SOM)神经网络在处理大规模数据集时,具有较强的计算性能和扩展性,适用于数据的主要特征提取和聚类。因此,本文利用SOM神经网络分析进行短行程聚类,结合主成分分析,构建包含车速和坡道信息的URDC,通过某5挡机械式自动变速器(Automated Mechanical Transmission,AMT)换挡规律开展仿真测试。
本文URDC的构建流程如图1所示。首先,采集具有典型坡道特征的城市道路行驶数据,并完成短行程划分、特征参数的选取与计算;其次,对选取的特征参数进行主成分分析;然后,基于SOM神经网络,将所有短行程聚类分为拥挤工况和顺畅工况,同时从各类别中选取合适短行程;最后,综合考虑短行程相关系数、坡道衔接平滑、相对误差等因素,构建城市坡道行驶工况。
使用VBOX主机,通过GPS信号实时采集车辆的位置、车速数据,通过惯性测量单元采集坡角数据,试验系统如图2所示。
选择具有典型坡道特征的山城重庆市区(覆盖各大主城区)道路,采集行驶工况构建基础数据。经过路线初选、交通流量点布置与调查、平均车速计算,最终确定试验路线全长63.4 km。连续14日(包括10个工作日和4个非工作日)使用平均车流法进行数据采集[14],在每日早高峰(7:30~9:30)和晚高峰(16:30~19:30)时段内,分别完成2次全路线数据采集,在平峰时段和低峰时段(10:00~16:00)完成2~3次全路线数据采集。
短行程指汽车行驶过程中,两个相邻怠速行驶状态间行程,包含匀速、加速、减速、怠速4种状态的运动学片段[15],如图3所示。
划分短行程时,首先对数据进行滤波预处理,即去除不合理数据,筛选有效数据;再将预处理后数据划分为一系列独立短行程,各短行程信息包含车速及其对应的道路坡角;将所有短行程按顺序编号,并计算每个短行程的时间长度,最终共获得1 314个短行程。
本文选取20个短行程特征参数,如表1所示。其中,平均坡角、上/下坡段平均坡角、上/下坡坡度标准差、上/下坡比例、平路比例为坡道行驶特征参数。
利用主成分分析方法,通过数学变换使特征参数降维,转换成一组独立的指标,使用相对较少的指标代表20个特征参数所含的道路及行驶信息。具体步骤如下:
a. 特征参数矩阵构造。假设 x i j为第 i个短行程的第 j个特征参数值,其中,i=1,2,…,nj=1,2,…,m。根据试验数据m=20,n=1 314,特征参数矩阵 X为:

c. 计算主成分相关系数矩阵为:

式中: r u , v为主成分相关系数, z - u z - v分别为 z u z v的平均值,uv为特征参数序号,E( )为均值函数。
d. 求解 R的非负特征值及其特征向量。对每个非负特征值 λ i解方程组 R l i = λ i l i,分别计算特征值对应的特征向量 l i
e. 确定主要主成分。计算主成分贡献率为:

将各主成分按其贡献率降序排列,前 q个主成分的累计贡献率 ψ q可表示为:

将前 p个特征值大于1、 ψ p>85%的主成分作为主要主成分。

基于短行程划分,按上述步骤a~步骤e,计算各主成分的特征值、贡献率和累计贡献率,结果如表2所示。根据步骤e,将主成分特征值大于1、累积贡献率达到86.217%的前5个主成分作为主要成分。
主要主成分载荷矩阵如表3所示,其中,主成分载荷系数的绝对值代表主要主成分与各特征参数的相关性。主成分M1主要体现特征参数vmvm,rvmaxam,aam,damaxaminvstdvstd,rastdastd,aastd,dPstd,down;主成分M2主要体现特征参数PmPm,upPm,downPupPdown;主成分M3主要体现特征参数am,aam,dastdPstd,up;主成分M4主要体现特征参数astd,a;主成分M5主要体现特征参数Pplain
SOM神经网络由输入层和竞争层组成,竞争层的节点与输入层的节点全连接,如图4所示。该网络以无监督学习方式,通过自组织和竞争学习机制调整网络权重,自主发现数据的内在结构,且该网络对噪声和片段数据具有较高的鲁棒性,可使聚类分析更稳健。
根据主成分分析结果,通过聚类分析将具有不同行驶特性的短行程分为2类,分别形成拥挤行驶工况和顺畅行驶工况。拥挤行驶工况中,汽车加、减速受限,平均速度和最大速度相对较低;顺畅行驶工况中,汽车加、减速相对自由,平均速度和最大速度相对较高。
基于SOM神经网络的短行程聚类分析流程如图5所示,其主要步骤为:
a. 初始化。当相邻学习轮次均达到最大学习次数时,各类短行程数量差值的绝对阈值Δnend=10,退出学习过程,应连续满足该阈值条件的学习次数为Kend=4;从5个输入神经元到2个输出神经元的连接权值ωJMJ=1,2,…,5;M=1,2)随机赋值,其中,J为输入神经元数量,M为输出神经元数量;学习率初值为η(0)=1,邻域强度初值为N(0)=3,每轮学习的最大学习次数初值为T1=300,最大学习次数上限为Tmax=10 000,最大学习次数步长为Tstep=300,学习轮数控制变量为r=1。
b. 令每轮学习次数控制变量为t=0,短行程编号控制变量K=1。
c. 输入归一化的主要主成分得分矩阵 F K * = [ f K 1 * ,   f K 2 * ,   ,   f K 5 * ],计算 F K *与输出层神经元M的间距:

d. 寻找获胜神经元。选择与输入向量距离最小的输出层神经元w作为获胜神经元,即dKw=min(dKM)。
e. 调节权值。取邻域强度Nw(t)=round(N(0)×(1-t/Tr)),其中,round( )为取整运算,Tr为第r轮的最大学习次数。在第(t+1)次学习过程中,调节获胜神经元及其邻域强度Nw(t)的邻域内神经元的权系数为:

计算所有连接权值后,进行归一化处理。
f. 令学习次数K=K+1,若K>n,执行步骤g;否则,返回步骤c。
g. 若t<Tr-1,则令t=t+1、K=1,执行步骤c;否则,统计第r轮学习后的拥挤行驶工况数量 n 1 ( r )和顺畅行驶工况数量 n 2 ( r ),令 r = r + 1
h. 若 r K e n d +1,且对于 P = 1,2 , , K e n d均满足条件: n 1 r - P - n 1 r - P - 1 Δ n e n d n 2 r - P - n 2 r - P - 1 Δ n e n d,执行步骤j;否则,令Tr=Tr-1 + Tstep
i. 若Tr> Tmax,执行步骤j;否则,返回步骤b,进行第(r+1)轮学习。
j. 结束学习并输出聚类结果。
依据聚类结果,选取前、后短行程的衔接处,坡角差值的绝对值不超过0.5°、平均相对误差最低的工况作为城市坡道行驶工况,主要步骤如下:
a. 聚类各类短行程,并按照相关系数由大到小排列,将相关系数不低于0.96的短行程作为候选。
b. 在每类候选短行程中,根据构建候选工况中所需该类短行程数量进行组合,得到各类候选短行程的所有组合:

式中:n′(M)为第M类短行程数量,N′(M)为第M类短行程中相关系数超过0.96的短行程数量, t s d d * ( M )为第M类短行程时间长度总和, t d c ( M )为第M类短行程组合预期持续时间长度。
c. 针对两类短行程,分别计算每类随机组合中所有短行程时间长度和,选取偏差不大于该类短行程预期持续时长5%的组合作为候选组合。
d. 排列各类候选组合,从不同类别中随机选取,按照组别收尾衔接构成一个新工况,重复该操作,得到若干工况。
e. 选取前、后短行程衔接处坡角差绝对值不大于0.5°的工况作为候选工况,包括速度-时间曲线及其对应的坡角-时间曲线。
f. 将平均相对误差最小的候选工况作为城市坡道行驶工况,如图6所示,计算该工况的平均相对误差:

式中: Δ e v ( j )为第j个特征参数值与该特征参数对应的总特征参数 v ( j )的相对误差,m为特征参数矩阵中特征参数的数量。
由式(12)计算可得 e m , r=7.88%,不计vmaxamaxamin 3个最值特征参数时, e m , r=4.79%。所建工况的平均相对误差计算结果表明该工况能体现车辆在城市坡道道路上的行驶特性。
为了验证本文URDC的有效性,以该工况为基准,对某5挡机械式自动变速器(Automated Mechanical Transmission,AMT)换挡规律开展仿真验证。
针对该AMT,使用文献[16]方法制定多性能综合最优坡道换挡规律。上坡时,部分坡角换挡规律如图7~图9所示,其中,图7为动力性占优(动力性权值0.7、经济性权值0.3)换挡曲线,图8为经济性占优(动力性权值0.3、经济性权值0.7)换挡曲线;下坡时,以坡角和车速为控制参数,制定适应坡角变化的下坡换挡曲线,如图9所示。
将URDC作为基准工况,使用MATLAB/Simulink建立坡道换挡规律仿真评价系统,如图10所示。该系统包括循环工况、车速跟随、发动机、AMT、整车纵向动力学等模块。
使用坡道换挡规律仿真评价系统仿真验证结果如图11所示。所构建的城市坡道行驶工况跟踪性能良好,在坡道行驶换挡方面,未考虑坡道换挡规律时,共进行换挡95次,而考虑坡道换挡规律后,仅换挡85次,换挡频率显著降低。在燃油经济性方面,未考虑坡道的换挡规律的油耗为0.416 7 kg,而考虑坡道换挡规律油耗为0.406 3 kg,降低了2.6%,耗油量明显降低。因此,本文构建的行驶工况可作为汽车城市坡道行驶性能测试的基准工况。
为了弥补汽车性能测试基准工况缺失、坡道信息不足等问题,本文提出了一种基于SOM神经网络的城市坡道行驶工况构建方法,构建了具有速度、坡角信息的城市坡道行驶工况。未来,可结合智能传感与大数据技术,拓展数据采集范围,获取更多具有坡道特征的城市道路和复杂山地公路的行驶数据。同时,优化特征提取与降维的方法,进一步提升所建工况的适应性和精度。
