For the lightweight design problem of composite grid-stiffened sandwich cylindrical shells, this paper proposes an optimization strategy that couples the differential quadrature method (DQM) with intelligent algorithms. First, the buckling governing equations are established based on the smeared stiffener method and energy principle, which are efficiently solved using DQM and validated through finite element analysis. Subsequently, an artificial neural network (ANN) surrogate model and genetic algorithm (GA) are employed to achieve structural optimization. The results demonstrate that the critical buckling loads obtained via DQM agree well with finite element results, confirming the accuracy of DQM in analyzing the buckling of sandwich cylindrical shells. The ANN-based surrogate model exhibits high reliability in predicting the critical buckling loads of grid-stiffened sandwich shells. Moreover, the genetic algorithm, combined with theoretical results, efficiently yields lightweight design parameters. Case studies show that the optimized structure not only achieves significant weight reduction but also exhibits a substantial increase in critical buckling load.

针对复合材料网格夹芯圆柱壳的轻量化设计问题,本文提出一种耦合微分求积法(Differential Quadrature Method,DQM)与智能算法的优化策略.首先,基于涂抹加筋法和能量法建立屈曲控制方程,采用DQM求解并通过有限元模拟验证了方法的有效性和精度.进一步,利用人工神经网络(Artificial Neural Network,ANN)建立了代理模型,对夹芯网格圆柱壳临界屈曲载荷进行了预测,模型结果具有良好的可靠性.将代理模型与遗传算法(Genetic Algorithm,GA)结合对结构参数进行了设计优化分析.结果表明,优化后的结构在满足力学约束前提下具有显著的减重效果.

For the lightweight design problem of composite grid-stiffened sandwich cylindrical shells, this paper proposes an optimization strategy that couples the differential quadrature method (DQM) with intelligent algorithms. First, the buckling governing equations are established based on the smeared stiffener method and energy principle, which are efficiently solved using DQM and validated through finite element analysis. Subsequently, an artificial neural network (ANN) surrogate model and genetic algorithm (GA) are employed to achieve structural optimization. The results demonstrate that the critical buckling loads obtained via DQM agree well with finite element results, confirming the accuracy of DQM in analyzing the buckling of sandwich cylindrical shells. The ANN-based surrogate model exhibits high reliability in predicting the critical buckling loads of grid-stiffened sandwich shells. Moreover, the genetic algorithm, combined with theoretical results, efficiently yields lightweight design parameters. Case studies show that the optimized structure not only achieves significant weight reduction but also exhibits a substantial increase in critical buckling load.

复合材料夹芯圆柱壳因其卓越的比强度、比刚度特性,已成为航空航天等领域关键承力结构的首选方案[1].这一技术随着科技发展不断演进[2-3]:在材料层面,从传统金属材料逐步过渡到碳纤维/环氧树脂等先进复合材料,以东方红系列卫星为例,通过采用碳纤维复合材料,在承力筒结构中实现了减重40%同时提升刚度25%的显著效果[4];在结构层面,则经历了从实心厚壳到加筋薄壳,再到夹芯结构的创新发展.其中,Vasiliev等[5]首先提出的网格结构因其良好的结构刚度和优异的轴压承载性能,被广泛应用于航天器承力装置中.随后通过在网格两侧添加蒙皮发展的夹芯网格结构,通过肋条-蒙皮协同作用机制,在保持轻量化优势的同时,大幅提升了结构的承载效率[6-7].夹芯圆柱壳结构不仅具备轻质高强和优异抗弯性能等结构优势,还能通过合理的芯层设计实现多功能集成,包括但不限于高效热管理[8]、振动抑制[9]以及能量吸收[10]等功能特性.
对于工业制造,夹芯结构的力学性能是衡量结构优劣和优化设计的基础,国内外对此进行了相关研究.在理论分析方面,Kidane等[11]应用加筋涂抹法,取出一个单胞进行分析,通过力和力矩的等效将Kagome网格等效成了单层均匀板,得到网格的拉伸、耦合和弯曲矩阵.考虑单层蒙皮的情况,将蒙皮的刚度贡献和网格的刚度贡献直接相加到总体刚度矩阵并用能量法获得屈曲方程.Sun等[12]取出单根肋条来分析,通过分析单根肋条的力学行为,并将其转化到全局坐标系下得到等效的应力应变关系,从而得到等效刚度矩阵.同时由矩阵的非奇异性证明了二维结构至少需要3个不同方向的肋条,三维结构至少需要6个不同方向的肋条.Zhai等[13]基于一阶剪切变形理论,考虑转动惯量和剪切变形的影响,在位移场中引入独立的转角变量来表示转角,得到包含3个方向切应力的应力应变方程,并根据Hamilton原理推导得到其自由振动方程.Khared等[14]发展了新的剪切变形理论并将该理论应用于夹芯结构的静力、屈曲和自由振动分析中,该理论引入了5种超越函数,构建了无需剪切修正因子的高阶剪切分析模型,除了精度提高之外,该模型还可自动满足板表面剪应力为零的边界条件.Nie[15]利用渐近迭代法求解了具有弹性约束的网格球壳屈曲问题.虽然现有研究在夹芯结构等效刚度理论和数值求解方法方面已取得重要进展,但针对网格夹芯承力筒这种特殊结构形式,其控制方程的求解精度和效率也面临着巨大的挑战.
在结构优化方面,Chaturvedi等[16]针对等网格圆柱壳和圆锥壳结构提出了多目标优化设计方法,该方法利用有限元参数化建模技术结合NSGA-II多目标遗传算法,实现了在多种外部工况下满足给定力学约束的最优质量设计.Sun等[17]开发的等效单壳智能分析模型结合机器学习算法,实现了对复合材料夹芯圆柱壳多模式失效的准确预测.陈伟明[18]采用智能优化算法和有限元分析相结合的方法,将网格承力筒的结构质量作为目标函数,通过施加约束来保证在结构不失去承载的前提下,搜索得到质量最小的优化设计方案.优化后结构的质量较传统蜂窝夹层承力筒结构减轻了49%.上述方法中使用有限元结果作为算法数据集,需要跑大量给定范围内的数据点,每个数据点的获取都需要完成建模、计算和后处理的整套有限元分析流程,时间成本极高.另一方面,必须基于给定的优化范围,而实际工程中可能无法先给出优化范围,对于给定范围以外的结构力学性能尚不清楚.
微分求积法作为一种高精度的数值求解技术,在板壳结构分析中已展现出独特优势[19-20].然而该方法在网格夹芯承力筒力学分析中的应用尚未见系统性的研究.同时,基于DQM的理论结果结合智能算法的优化路径研究相对不足.
本文以具有六边形单胞形式的夹芯网格圆柱壳为研究对象,将DQM应用到该复合材料圆柱壳结构的轴压屈曲分析中.运用DQM方法的计算结果与有限元结果的对比,验证了方法的有效性和精确性.在此基础上,结合人工神经网络和遗传算法对结构进行优化设计.使用多层感知机(Multilayer Perceptron,MLP)神经网络拟合了结构参数与单位质量屈曲之间的非线性映射模型,通过标准化预处理和超参数调优以确保模型精度.并采用遗传算法进行设计空间搜索,从而获得满足力学约束下质量最小的结构参数组合结果.
图1所示,网格夹芯圆柱壳由内外两层均匀蒙皮和中间非均匀的芯层结构组成,壳体长度为L,半径为r.芯层结构选取Kagome形式网格圆柱壳[5],这种结构由斜肋和环肋交织而成,取芯子层中面作为参考面,建立如图所示柱坐标系,径向坐标以向里为正.结构参数有:内蒙皮厚度ti、芯层厚度ts、外蒙皮厚度to、斜肋个数nh、环肋个数nc、斜肋宽度bh和环肋宽度bc
对于芯层,根据周期性结构的特点,取出一个单胞作为分析对象,通过力等效将非均匀结构转化成均匀结构,简化计算模型,使得可以应用成熟的均匀材料力学理论来分析复杂的网格结构力学行为.该方法的理论基础已在文献[21]中得到充分论证.等效过程如图2所示.
由此得到芯子的内力-应变关系[22]

其中,蒙皮柔度阵,刚度矩阵为K=S- 1E11E22G12ν12分别是蒙皮的弹性模量和泊松比.
将芯层等效为均匀结构,以芯层中面为参考面,夹芯圆柱壳任意点处的应变与参考面应变及曲率的关系为
参考面上的内力与变形关系可以通过应力合成(沿厚度积分)表示为
其中,AAij)为拉伸刚度矩阵,描述内力与中面应变间的关系;DDij)为弯曲刚度矩阵,描述内力与弯曲变形(或弯矩与中面应变)之间的耦合效应;BBij)为拉弯耦合矩阵(ij=1,2,3),描述弯矩与曲率之间的关系.计算公式为
式(6)~式(8)均沿着厚度方向积分,为面内刚度矩阵元素,具体值与材料相关.当对蒙皮层积分时,则取K中对应元素,对芯层进行积分时,则取C中对应元素.计算得到的最终表达式为

具体的算子参见附录.
实验和有限元计算结果[11,17]都表明,参考面位移在圆柱面环向方向上具有周期性,因此考虑利用分离变量法求解控制方程.假设控制方程具有如下形式的解
其中,m为待定的正整数,其表现为位移在环向方向上的三角波数.将式(17)代入到式(16)中,并引入无量纲量η=x/L∈[0,1].根据求导法则有

其中,微分算子均为常微分算子,具体表达式见附录.
DQM的主要思想是选取一个高阶插值函数来替代原有函数,并将原有函数的各阶导数或积分表示成离散点上函数值的加权求和,从而可将任意阶数的微分方程或者积分方程转化成关于离散点函数值的代数方程.例如,对于定义在[0,1]区间上的一元函数,在定义域内选取N个离散点,则在离散点上的一阶导数值近似表达为
其中,Q称为一阶加权系数矩阵,为N阶方阵,其元素Qij的物理意义为第j个点的函数值对第i个点的一阶导数值的影响权重.
使用DQM可将屈曲荷载的求解统一转化成系数矩阵的特征值问题.首先选取离散点,对于一维问题,选取包含端点的非均匀布点方式可更好保证收敛性,本文选取切比雪夫离散点[23],即
其中,N为离散点个数,布点方式如图3所示,靠近端点处加密,远离端点处可适当放松间距.
离散点确定后,选取试验函数以确定各阶加权系数矩阵.选取N个试验函数[24]

对于承受轴压的承力筒,可近似认为下端位移全部约束,顶端除轴向位移外全部约束.轴力在能量方程中体现,上边界处为零.因此,边界条件可表示为
对于简单边界条件,可直接用单位行向量表示.位移的一阶导数可通过代入离散的位移表示

将离散后的边界条件系数矩阵替换控制方程系数矩阵中的对应行T0,上端边界依次替换第N+1行、第2N+1行、第2N+2行和第1行,下端边界代入可依次替换第N行、第2N行、第3N行和第3N- 1行,并代入式(31).至此,已将8个边界条件全部代入.
发生屈曲时,所有点的位移不全为0,即控制方程存在非零解.系数矩阵中含有轴向压力P,令其行列式为0,则得到关于P的多项式方程,该方程的最小实根即为临界屈曲载荷.将代入边界条件后的系数矩阵记为
其中,J1J2分别为关于P的常数项矩阵和一次项系数矩阵.当发生屈曲失稳时,关于离散点位移的线性方程组应存在非零解,充要条件为系数矩阵行列式为0,即
P=0时,即不施加任何外载,则离散点均无位移,即方程组只有零解,从而

其中,E为3N阶单位矩阵.记的最大实特征值为λ,则临界屈曲荷载为
上式求得的结果是环向波数m的函数,取该函数的最小值作为临界屈曲荷载,对应的特征向量即为临界屈曲模态.以上得到的屈曲荷载与离散点选取个数N有关,随着N的增加,理论上均收敛到真实值.
DQM的结果受选取的离散点个数和布点方式影响,为验证本文方法的可行性,首先需要验证其收敛性以及收敛效果.算例的材料参数如表1所示,x方向为1方向,与x垂直的为2、3方向.结构参数如表2所示.
首先进行收敛性验证,当波数m一定时,离散点个数从N=10开始逐次增加1直至30,计算结果如图4所示.结果显示收敛速度很快,在离散点个数为20左右时就已经收敛到最终结果,当离散点个数继续增大时,其结果几乎不变.为保证充分收敛,后续计算取离散点个数为30可以保证收敛性的同时减少计算时间.
此外,求解结果还与环向波数有关,最终屈曲荷载是关于环向波数的最小值,因此,为验证该最小值的存在性,改变表2中的斜肋个数和环肋个数,观察不同肋条数目下求解结果随环向波数的改变情况.结果如图5所示.
图5可知,随着环向波数的增加,轴压屈曲结果呈现先减小后增大的趋势,显然存在最小值,且均在环向波数m=7附近取得最小值,即临界屈曲荷载为24 762 kN.
使用商业软件Abaqus,对算例进行有限元分析,使用S8R5壳单元建模,边界条件与理论部分一致,进行特征值屈曲分析,获得的一阶特征值即为临界屈曲载荷.该结构的临界屈曲载荷为24 372 kN,与DQM计算的24 732 kN误差为1.46%.临界屈曲模态如图6所示,一阶模态波数为7,与DQM计算m=7时取得最小值结果吻合.
进一步地,改变结构参数再进行几组验算.保持斜肋数目nh=80不变,将环肋数目由10依次增加至20,使用DQM和有限元方法所得结果及二者误差分别如图7所示.
变化环肋个数时,由图7(a)知,DQM与有限元结果变化趋势一致,表明二者结果吻合很好.根据图7(b)观察到DQM相对于FEM有1.5%左右正向误差,这是因为对高阶导数离散迭代过程积累了轻微正偏差,导致等效刚度矩阵计算结果轻微偏高,但误差结果保持在很小的水平,由此验证了本文方法的精确性.
本文采用基于理论结果的代理模型与遗传算法相结合的优化方法.DQM-ANN耦合策略以“离线训练+在线预测”模式,兼顾理论精度与优化效率,适用于大规模参数空间探索.首先进行参数初始化,利用代理模型预测结构屈曲载荷,进行约束检查.若预测结果不满足条件,则施加罚函数处理.接着利用遗传算法进行参数寻优,通过交叉和变异操作生成新的种群,再次预测屈曲载荷并检查约束条件.这一过程循环往复,直至找到最优参数组合.优化目的是找到满足临界屈曲载荷的最轻结构参数组合.优化流程如图8所示.
本文采用基于多层感知机的人工神经网络方法构建代理模型.ANN方法的核心思想是通过调整网络权重W和偏置b,使得模型输出与真实值y之间的误差最小化.其中,激活函数σ(·)用于引入非线性特性,而损失函数(如均方误差)用于衡量模型性能.
问题描述为

对于输入数据X=[X1X2,…,Xk],其中k为特征数,网络的每一层输出可表示为
其中,hl为第l层的输出,σl(·)为第l层的激活函数(如ReLU或Sigmoid),Wlbl分别为第l层的权重和偏置.
通过反向传播算法和梯度下降优化器,ANN能够自动学习输入与输出之间的复杂非线性关系,从而实现对目标函数的高精度拟合.
本文采用拉丁超立方采样(Latin Hypercube Sampling,LHS)方法在取样空间(如表3所示)随机生成1 000个均匀分布的样本点,80%作为训练集,20%作为测试集.
使用Scikit-learn库对数据进行标准化处理,它将数据按照式(44)转换成均值为0、标准差为1的标准正态分布.其中,X是原始数据,μ是数据的均值,σ是数据的标准差
构建MLP回归模型,用于拟合设计参数与性能指标之间的非线性关系.模型结构包括输入层(对应设计参数)、1-2层隐藏层、以及输出层(对应性能指标).为防止模型过拟合,通过在损失函数中添加权重的平方和作为惩罚项,限制模型的复杂度.在模型构建完成后,采用网格搜索对ANN的超参数进行优化,包括隐藏层神经元数量、惩罚参数、学习率和激活函数,表4列出了超参数的搜索范围和结果.
将数据集随机分成5份,依次以其中4份作为训练集、1份作为测试集进行5次训练和验证,最终综合评估模型性能,以提高结果的稳定性和可靠性.图9为5折交叉验证的流程.
模型的拟合质量由决定系数R2、绝对误差MSE和平均相对误差MRE来衡量,计算公式分别为
其中,yi为真实值,为预测值,为平均值,n为样本数.
预测结果如图10所示,预测点集中分布在y=x直线周围,大部分数据点落在10%的误差边界以内.数据上,最优模型的R2分数为0.990 11,非常接近1,相对误差值只有1.3%.五折验证结果显示,训练集的分数在0.987~0.988,测试集的R2分数在0.983~0.989,进一步验证了模型在不同数据子集上的稳定性和可靠性.以上说明了使用ANN对临界屈曲载荷进行拟合预测的可行性.
使用遗传算法进行优化设计,优化流程如图11所示.ANN预测的临界屈曲载荷作为约束,结构质量作为目标函数.质量计算公式为
算例结构尺寸为R=1 000 mm,L=1 800 mm,材料参数如表1所示,优化结果如表5所示.
将优化结果代入DQM和FEM进行验证:DQM计算的临界屈曲载荷为24 749.7 kN,与ANN的误差为0.3%;FEM计算结果为24 513,与ANN误差为1.2%,再次说明了代理模型的有效性.同时,优化后结构质量为79.4 kg,与优化前的98.7 kg相比,减重19.6%.
本文采用DQM分析了具有六边形单胞形式的夹芯网格圆柱壳结构的轴压屈曲问题.通过与有限元数值模拟的比较验证了方法的有效性和精确性.利用理论模型计算结果结合ANN方法,建立了代理模型以拟合临界屈曲载荷,结合遗传算法参数寻优获得了质量最小的结构参数组合,有效实现了结构参数优化设计.本文提出的耦合微分求积法与智能算法的策略对于航天复合材料夹芯网格壳结构的参数优化设计具有重要参考价值.
