In order to solve the problem of difficulty in determining the optimal measurement points for bearing signal acquisition. Taking the NU306 bearing-housing system as the research object, the bearing housing to carry out multi-measurement points vibration test experiment. The local linear embedding algorithm was used to linearly reduce the multi-dimensional space data of the bearings to obtain the sensitivity matrix of the measurement point. The optimal position of the measuring point under varying load and rotation speed was studied when the inner or outer ring are defective. The results show that for bearings with outer ring failures, the optimal measurement point is the one closest to the location of the failure when the load or rotational speed increases. For bearings with inner ring failures, the optimal measurement point is the one at lower loads far from the center of the housing when the load or rotational speed increases. The results can provide an effective reference for the selection of measurement points under different operating conditions.

为解决轴承信号采集时难以确定最优测点这一问题。以NU306轴承-轴承座系统为研究对象,对轴承座开展多测点振动测试实验,运用局部线性嵌入算法对轴承多维数据进行线性降维得到测点灵敏度矩阵,研究了内、外圈故障时,载荷与转速变化下最优测点位置。结果表明,对于外圈故障的轴承,转速或载荷增大时优质测点为距离故障位置最近的测点;对于内圈故障的轴承,载荷或转速增大时优质测点为距离轴承座中心远且载荷较小的测点。研究结果可为不同工况下的测点选择提供有效参考。

为解决轴承信号采集时难以确定最优测点这一问题。以NU306轴承-轴承座系统为研究对象,对轴承座开展多测点振动测试实验,运用局部线性嵌入算法对轴承多维数据进行线性降维得到测点灵敏度矩阵,研究了内、外圈故障时,载荷与转速变化下最优测点位置。结果表明,对于外圈故障的轴承,转速或载荷增大时优质测点为距离故障位置最近的测点;对于内圈故障的轴承,载荷或转速增大时优质测点为距离轴承座中心远且载荷较小的测点。研究结果可为不同工况下的测点选择提供有效参考。

In order to solve the problem of difficulty in determining the optimal measurement points for bearing signal acquisition. Taking the NU306 bearing-housing system as the research object, the bearing housing to carry out multi-measurement points vibration test experiment. The local linear embedding algorithm was used to linearly reduce the multi-dimensional space data of the bearings to obtain the sensitivity matrix of the measurement point. The optimal position of the measuring point under varying load and rotation speed was studied when the inner or outer ring are defective. The results show that for bearings with outer ring failures, the optimal measurement point is the one closest to the location of the failure when the load or rotational speed increases. For bearings with inner ring failures, the optimal measurement point is the one at lower loads far from the center of the housing when the load or rotational speed increases. The results can provide an effective reference for the selection of measurement points under different operating conditions.

滚动轴承广泛应用在回转设备上,若其发生故障将导致设备不能正常运行,因此降低轴承故障发生的概率对提高设备的使用效率具有重要意义[1-2]
轴承状态监测和故障检测是保障设备安全运行和延长轴承寿命的重要手段。目前,基于振动信号的故障诊断是最常用、可靠的方法[3]。Dolenc等[4]研究了一种采用振动分析的分布式轴承故障诊断方法。He等[5]提出一种新的混合深度信号处理轴承故障诊断方法,该方法将振动分析技术融入深度学习中。Feng等[6]计算外圈、滚动体和内圈故障特征频率的显式方程,考虑行星轴承的复杂运动,建立轴承振动信号动力学模型。王崇昊等[7]研究了滚动体经过外圈圆形故障区域时的接触间隙变化规律,分析了不同故障尺寸的滚动轴承振动信号。中外学者们利用轴承振动信号对轴承进行故障诊断,但因振动信号采集的低准确性导致故障诊断水平难以得到进一步的提高。
轴承发生故障以后,通常是在轴承箱壳体上采集故障振动信号,但故障振动信号传递到轴承箱表面测点会有一定程度的衰减且会受到噪声的干扰,因此,选择合适的测点获得有效的故障信息就非常重要。陈果等[8]通过对轴承座测点信号和机匣测点信号的时域波形、频谱和小波包络谱进行详细对比分析,研究了基于机匣测点信号进行滚动轴承故障诊断的灵敏性问题。黄鑫[9]根据齿轮箱故障诊断中对原始振动信息的获取,提出了使用加速度传感器在齿轮箱上获取振动信号时应该将其布置在对振动信号最优的测点位置。肖嘉伟等[10]通过有限元仿真分析,提出了一种基于主成分分析的嵌入式智能轴承感知测点最优选择方法。谢宏彬[11]研究了航空发动机振动测振动截面的选取方法,结合信息熵理论提出了一个发动机振动测点布局优化方法。刘彪[12]通过测点密布试验,提取表征机体运行状态的特征参量和振动信号和频域信号,将局部线性嵌入算法运用到齿轮箱结构及其振动信号特征分析。
综上所述,中外学者们对轴承座和齿轮箱的测点优化进行了大量研究,一些学者采用仿真来获得测点振动信号,一些学者采用算法对单侧点进行优化。其中,采用仿真获得的振动信号可靠性较低,这是因为仿真获得的振动信号是理想状态下的且实际运行中存在噪声干扰,在不同工况下采集的振动信号并不能完全真实地反映轴承内部的机理特性[13];采用算法对单侧点进行优化的准确率较低,这是因为轴承内部故障振动信号到达轴承座表面的故障激励不同,在不同位置获得的振动信号强弱不一[14]。而实验获得的振动信号更能真实地反映轴承内部的激励特性,且运用局部线性嵌入算法分析振动信号可提高故障诊断的准确性[12],该算法在轴承测点选择方面研究较少。
鉴于此,现以NU306轴承-轴承座系统为研究对象,提取轴承故障时不同工况下轴承座上各测点的振动响应,选取振动信号的特征域构建高维空间,利用局部线性嵌入算法对轴承内、外圈故障时各测点与故障源的相关性进行分析,得出各测点灵敏度的变化规律。为故障诊断在不同工况下的测点选择提供有效参考。
局部线性嵌入(locally linear embedding,LLE)与用于局部降维的聚类方法不同,它是一种无监督学习算法[12],可计算高维输入的低维、邻域保留嵌入,映射到单个较低维的全局坐标系中,并且其优化不涉及局部最小值[15-16]
本文研究采用信号特征参数来评价测点的灵敏度,进而确定轴承故障检测时优质测点的位置。振动监测的主要特征域有幅域和频域[17]。幅域特征参量提取10个有量纲参数和5个无量纲参数,有量纲参数为平均值、绝对值、最大值、最小值、均方根值、方差、方根幅值、绝对平均幅值、歪度和峭度;无量纲参数为波形指标、峰值指标、脉冲指标、裕度指标和峭度指标[12];频域特征参量为轴承运转的基频、倍频和二倍频。
有量纲参数可以衡量振动信号的能量和强度,无量纲参数对脉冲冲击比较敏感。有量纲参数值随着故障的发生而增大,受外部噪声条件、载荷和转速的影响较大。为了提高信号对故障的敏感度,因此采用无量纲幅域诊断参数。
频谱全局峰值描述了振动大小和边频的总体情况,但当频谱图中存在很大的峰值时,较小的峰值可能被掩盖,因此有必要分频段提取峰值来获得完整的峰值和边频信息。计数域的特征参量主要反映边频信息,取频谱全局、低频区、中频区、高频区各频段内的前10%,经圆整后,上述频段全局20,低频5、中频8、高频12共取45个变量,通过计数域内的峰值提取,可以获得较为理想的边频信息。
在幅域、频域和计数域内提取特征向量,这些变量形成如式(1)的高维向量,用来描述机体的运行状态。由上述分析可知,本文构造的高维向量维数为63,该向量所在的非线性高维空间为时域局部线性嵌入算法降维的初始空间,最终构成了n×63的高维特征矩阵X,n为测点个数,本文取为7。

式(1)中:$\stackrel{-}{\mathrm{X}}$为平均值;${\left|X\right|}_{\mathrm{m}\mathrm{a}\mathrm{x}}$为绝对值最大值;Xmax为最大值;Xmin为最小值;Xrms为均方根值;${\sigma }_{x}^{2}$为方差;Xr为方根幅值;$\left|\stackrel{-}{\mathrm{X}}\right|$为绝对平均幅值;α为歪度;β为峭度;Sf为波形指标;Cf为峰值指标;If为脉冲指标;CLf为裕度指标;Kv为峭度指标;${P}_{a1},{P}_{a2},\dots,{P}_{a20}$为全局峰值统计;${P}_{i1},{P}_{i2},\dots,{P}_{i5}$为低频峰值统计;${P}_{m1},{P}_{m2},\dots,{P}_{m8}$为中频峰值统计;${P}_{h1},{P}_{h2},\dots,{P}_{h12}$为高频峰值统计。
LLE算法的待定系数为邻域点数K和低维空间维数d,运用LLE算法对上述建立的高维特征矩阵进行降维,为使降维结果更加直观且包含更多特征信息,取某一测点与其他测点进行相关性分析,得出邻域搜索点K值。选取两测点间的频域值相关性分析,其计算公式为

式(2)中:ρxyxy之间的相关系数,通常选取ρxy=0.5为阈值;cxy为随机变量xy的协方差;σxσy分别为xy的均方差;E为求期望;μxμy分别为xy的期望值;计算结果为n×n维的相关系数矩阵。
本文轴承座上7个测点各自的相关性中,满足条件的邻域测点数目区间为5~6,本文研究中取临近点数K=6,低维空间维数d=3。
确定邻域点数和低维空间维数后,对重构权值矩阵Wij进行计算。不同测点得到的数据通过特征向量进行归一化,获得长度固定的高维特征向量X。在非线性高维空间中,每个测点对应着一个向量Xi,Xi的邻域中,为使重构误差最小,重构每个Xi的权值Wij
根据权值矩阵W重构每个数据点的低维嵌入向量Yi,使得重构误差最小。
求解稀疏矩阵的特征向量为对灵敏度矩阵Y的求解,其表达式为

构造对称矩阵M

以降维之后各测点低维向量的2范数作为衡量测点反映振动信息灵敏度大小的总体标准。轴承内外圈故障时的各种工况组成了灵敏度矩阵Y。本文研究中内、外圈故障分别有9种工况,最终分别得到7×9的灵敏度矩阵。测点分析的优化流程如图1所示。
以NU306圆柱滚子轴承-轴承座系统为研究对象,搭建的试验台如图2所示,该试验台主要由伺服电机、径向加载装置、力显示器、加速度传感器、伺服电机控制器、实验轴承、支撑轴承、加载轴承和数据采集卡等组成。将实验轴承过盈安装在轴承座内,外圈固定,内圈随着电动机主轴转动,通过径向加载装置施加力到加载轴承上,轴承和轴承座参数如表1所示。
轴承故障分外圈故障和内圈故障两种,外圈故障时故障位置是固定的,内圈故障时故障位置是随着时间变化的,为更好测得轴承内、外圈故障时各个测点在不同载荷与不同转速下的振动响应,针对两种故障设置实验工况,具体如表2所示,其中内、外圈故障的故障尺寸均为1 mm×1 mm。
实验所用传感器皆为单向传感器,为保证传感器便于安装且尽可能地靠近故障部位,将测点选在轴承座表面。因实验轴承座为对称结构,故在选择测点位置时,只在轴承座半个表面选取若干测点,测点分布如图3所示。
在轴承座表面共选取8个测点(#1~#8),因为#4测点处在实际操作时有用来固定轴承的螺栓,所以#4测点得到的振动信号会包含大量由螺栓产生的振动信号,在实际工作时不考虑此测点。故本文忽略#4测点,共7个有效测点,其中#1、#2测点布置为Y方向的传感器,#3、#5、#6、#7、#8测点布置为X方向的传感器。
轴承外圈故障时,按照表2的工况条件进行实验,将得到的实验数据使用LLE算法进行处理,得到灵敏度矩阵y1,如表3所示。外圈故障时,各测点在不同工况下的灵敏度折线图如图4所示,各测点在试验工况下的灵敏度均值图如图5所示。根据图4图5选择合适测点分析外圈故障时,测点灵敏度值与载荷和转速之间的关系,得出了在不同工况下最优测点的位置。
排除计算误差,由图4可知,#3、#5和#6测点的灵敏度值随工况变化较大,在试验的工况下不平稳,这是因为#3、#5、#6测点相比于#7和#8测点距离外圈故障位置较远,所测振动信号包含较多轴承座自身的振动信号,使得灵敏度值变化较大,与故障源的相关性差。故在外圈故障时不适合选取距离故障点较远的测点。
#1、#2、#7、#8测点灵敏度值较高且较为稳定,仅在个别工况下产生单个波动。这是因为#1和#2测点位于轴承座上刚度较小的位置,#7和#8测点距离故障位置较近,因此外圈故障时优质测点位于轴承座刚度较小或距离故障点最近的测点。
图5可知,灵敏度值由高到低依次为#2、#8、#1、#7、#3、#5、#6测点。由于#2、#8和#1测点对外圈故障振动信号更敏感,故采用#2、#8和#1测点研究灵敏度值与载荷和转速的关系。外圈故障时,#1、#2、#8测点在不同转速下的灵敏度值如表4所示,#1、#2、#8测点灵敏度随转速变化曲线如图6所示。
图6可知,随着转速增加,#1测点的灵敏度值增大,#2测点灵敏度值减小,#8测点的灵敏度值先减小后增大。#1和#2测点的灵敏度变化较大,#8测点的灵敏度变化较小且灵敏度均值较大,因此转速增大时优质测点为距离故障位置最近的测点。
外圈故障时,#1、#2、#8测点在不同载荷下的灵敏度值如表5所示,#1、#2、#8测点灵敏度随载荷变化曲线如图7所示。
图7可知,随着载荷增大,#1和#8测点的灵敏度值为先增大后减小,#2测点的灵敏度值为先减小后增大。#2测点的灵敏度变化较大,#8测点的灵敏度均值大于#1测点,这是因为轴承座自身的结构振动受载荷影响较大,而故障激励信号在转递过程中受载荷的影响较小,因此载荷增加时优质测点为距离故障位置最近的测点。
综上所述,轴承外圈故障时,转速或载荷增大时优质测点为距离故障位置最近的测点。
轴承内圈故障时,按照表2的工况条件进行实验,将得到的实验数据使用LLE算法进行处理,得到灵敏度矩阵y2,如表6所示。内圈故障时,各测点在不同工况下的灵敏度折线图如图8所示,各测点在试验工况下的灵敏度均值图如图9所示,根据图8图9选择合适测点分析内圈故障时,测点灵敏度值与载荷和转速之间的关系,得出了在不同工况下最优测点的位置。
图8可知,#1和#2测点的灵敏度值相近;#3测点的灵敏度值最小且不稳定,这是由于该测点位于轴承座的倒角处,其包含较多轴承座自身的振动信号;#5测点的灵敏度值高且平稳;#6测点的灵敏度值较小但较平稳;#7测点的灵敏度值较小且存在单个突变值;#8测点的灵敏度值在中速中载时波动较大,其他工况时灵敏度值较高且平稳。其中,#5和#8测点为距离轴承座中心最远的两个测点且测量的均是X方向的振动信号,#8测点处载荷较大,#5测点处载荷较小,两测点均能较好地反映轴承内圈故障的振动信号特征,因此轴承内圈故障时优质测点位于距离轴承座中心远的测点。
图9可知,灵敏度值由高到低依次为#5、#8、#2、#1、#7、#6、#3测点。由于#5和#8测点对内圈故障振动信号更敏感,故采用#5和#8测点来研究灵敏度值与载荷和转速的关系。内圈故障时,#5和#8测点在不同转速下的灵敏度值如表7所示,#5和#8测点灵敏度随转速变化曲线如图10所示。
图10可知,随着转速增大,#5测点的灵敏度值会减小,变化幅度较小,#8测点的灵敏度值为先减小后增大,变化幅度较大。由于#5测点比#8测点的灵敏度值大且更稳定,因此转速增大时优质测点为距离轴承座中心远且载荷较小的测点。
内圈故障时,#5和#8测点在不同载荷下的灵敏度值如表8所示,#5和#8测点灵敏度随载荷变化曲线如图11所示。由图11可知,随着载荷增大,#5和#8测点的灵敏度变化趋势与转速增加时的变化趋势相同。因此转速增加时优质测点为距离轴承座中心远且载荷较小的测点。
综上所述,内圈故障时,载荷或转速增大时优质测点为距离轴承座中心远且载荷较小的测点。
采用实验与算法相结合的方法,对轴承-轴承座系统在不同工况下各测点的振动信号及振动信号的特征域进行了采集与计算,通过局部线性嵌入算法对测点与故障源的相关性进行了研究,对内、外圈故障时各测点灵敏度进行了排序,得到以下结论。
(1)局部线性嵌入算法可用于对实验数据进行线性降维得到测点灵敏度矩阵,实现轴承座上测点位置的优化。
(2)轴承外圈故障时,转速或载荷增大时优质测点为距离故障位置最近的测点。
(3)内圈故障时,转速或载荷增大时最优测点为距离轴承座中心远且承受载荷较小的测点。
