The problem of scheduling and collaborative decision-making in airport metroplex or terminal areas can be significantly approached by obtaining accurate ETA (estimated time of arrival). Traditional methods are short of the ability to fine-tune the arrival metering nodes. The accurate quantitative estimation of large-volume and complex flight traffic situations is hard to achieved especially under the influence of highly dynamic environments in a medium to long term. An ETA correction method based on error feedback was proposed. Based on the aircraft performance parameters, an aircraft kinematics model was firstly constructed combined with route planning and meteorological data, which was used to give a preliminary ETA prediction through the calculation of 4D trajectory then. After that an error sequence would be constructed by comparing the difference between ATA (actual time of arrival) and the predicted results, with it the next error could be predicted using the error feedback model and the results obtained previously would be corrected. Finally, the arrival flights to a large hub airport were taken as examples to conduct a simulation, in which the rate of error within ±5 minutes that predicted 30 minutes in advance was chosen as the evaluation criteria. The simulation results show that the accuracy of ETA prediction can be improved by more than 25% in bad weather after corrected by the proposed method when compared with traditional means.

精确估计航班预计到达时刻(estimated time of arrival,ETA)对机场群或终端区协同调度辅助决策制定有重要意义,传统方法对于进场计量节点精细化感知能力不足,特别在高动态环境影响下对大体量复杂航班交通态势难以实现中-长期精准定量估计。提出了基于误差反馈修正的航班预计到达时刻预测方法,首先,基于航空器性能参数,结合对未飞航路的规划和气象因素,构建航空器运动学模型;其次,通过四维航迹推演对预计到达时刻进行初步预测;然后,构造实际落地时刻(actual time of arrival,ATA)与预测结果的误差序列,采用误差反馈模型对序列进行预测并修正初步预测结果。最后,以重庆江北国际机场进港航班为例进行仿真验证,将提前30 min预测结果在±5 min以内的比率作为评价指标,结果表明相比传统方法,本文方法可在恶劣天气下将预计到达时刻预测的准确率提高25%以上。

精确估计航班预计到达时刻(estimated time of arrival,ETA)对机场群或终端区协同调度辅助决策制定有重要意义,传统方法对于进场计量节点精细化感知能力不足,特别在高动态环境影响下对大体量复杂航班交通态势难以实现中-长期精准定量估计。提出了基于误差反馈修正的航班预计到达时刻预测方法,首先,基于航空器性能参数,结合对未飞航路的规划和气象因素,构建航空器运动学模型;其次,通过四维航迹推演对预计到达时刻进行初步预测;然后,构造实际落地时刻(actual time of arrival,ATA)与预测结果的误差序列,采用误差反馈模型对序列进行预测并修正初步预测结果。最后,以重庆江北国际机场进港航班为例进行仿真验证,将提前30 min预测结果在±5 min以内的比率作为评价指标,结果表明相比传统方法,本文方法可在恶劣天气下将预计到达时刻预测的准确率提高25%以上。

The problem of scheduling and collaborative decision-making in airport metroplex or terminal areas can be significantly approached by obtaining accurate ETA (estimated time of arrival). Traditional methods are short of the ability to fine-tune the arrival metering nodes. The accurate quantitative estimation of large-volume and complex flight traffic situations is hard to achieved especially under the influence of highly dynamic environments in a medium to long term. An ETA correction method based on error feedback was proposed. Based on the aircraft performance parameters, an aircraft kinematics model was firstly constructed combined with route planning and meteorological data, which was used to give a preliminary ETA prediction through the calculation of 4D trajectory then. After that an error sequence would be constructed by comparing the difference between ATA (actual time of arrival) and the predicted results, with it the next error could be predicted using the error feedback model and the results obtained previously would be corrected. Finally, the arrival flights to a large hub airport were taken as examples to conduct a simulation, in which the rate of error within ±5 minutes that predicted 30 minutes in advance was chosen as the evaluation criteria. The simulation results show that the accuracy of ETA prediction can be improved by more than 25% in bad weather after corrected by the proposed method when compared with traditional means.

为精准把握航班运行关键时间节点,对进港航班预计到达时刻(estimated time of arrival,ETA)进行预测具有重要意义。一方面,能够辅助管制员了解空域单元即将呈现的交通状态,给予其充足的时间思考并制定航班调配方案,减少由于航班状态的未知性造成的管制负荷;另一方面,提前获悉航班飞行过程中精确路径信息和时间信息,可对未来一段时间空域内航班流序列进行预测,为交通参与各方制定相应的协同管控策略提供数据支撑。
中外相关学者已经开展了很多如何提高ETA预测精度的研究,其采取的方法可以分为两类。第一类采取对航空器的航迹进行预测的方法来估算ETA,如Yang等[1]提出了一种混合线性系统,并通过非线性规划来对航空器进行目标跟踪和4D轨迹预测,但此方法只在特定运行场景下的机场和终端区做了验证;Ghazi等[2]将航行过程分成7个阶段并分别采用数值方法计算各段所需飞行时间,但实验数据的取得较为规则,不能反映真实条件下的预测结果;张军峰等[3]提出了基于航空器性能数据以及航空器意图的四维航迹预测方法,但由于无法确定航空器意图,在高度剖面上的误差较大;刘杰等[4]则使用计划到达时间为目标,来对航迹进行反向计算,但航迹规划的运算效率达不到实时性需求;Chai等[5]提出一种回归分析和质心插值(barycentric interpolation)相结合的方式来预测航路以及航空器到达指定计量点的时刻,但是该方法的变量单一,不能应对突发天气等状况;侯昌波等[6]提出基于航路排序和间隔的过点时序管控方法,可以预测100 min内的飞行轨迹,但速度可控范围较小,仅能应对部分飞行情况。第二类通过对航班历史数据及其他信息进行挖掘和匹配的方式来预测ETA,如陈强等[7]通过分析历史航迹,构建径向基函数(radial basic function)神经网络对进场飞行时间进行预测,但未考虑风速、风向对航空器飞行时间的影响;郑志祥等[8]通过分析航班信息、天气信息以及空中交通信息,建立了基于随机森林算法的航空器ETA预测模型,但所需的同航路历史数据量较大;Wang等[9]提出了一种堆叠神经网络模型的机器学习集成模式来预测航空器在跑道入口点的到达时刻,但训练用的数据集较为特异化,不具备普适性;翟俐民等[10]对航空器历史轨迹进行层次聚类,并基于时间序列进行分析,通过长短期记忆(long short-term memory)神经网络建立预测模型,但是未考虑聚类中出现的离群航迹,模型不具备普遍适用性;Ma等[11]建立了一个时空神经网络(spatial-temporal neural network)模型,以历史航迹及其对应的实际到达时间为输入,训练其ETA预测能力,但该模型对航空器机型不敏感,且只能在短期内做出预测。
除此以外,以上研究方法的重点集中于采用各种方式对航班的ETA进行先验预测,真实ETA数据仅仅被用作基准对预测结果进行检验,且大部分方法机制缺乏实时性,达不到随时输出预测结果的性能,不能对空管的指挥提供现实帮助。而在实际运行中,ETA预测的结果可以随着航班落地得到验证,形成一系列预测误差序列,通过这些误差可以后验地得到ETA预测的误差来源,并应用于后续的预测过程中,则可有效规避因天气、管制集中指挥等形成的系统性预测误差。
现提出一种基于误差反馈修正的ETA预测模型,首先基于航空器性能参数构建运动学模型,并通过四维航迹推演对ETA做出初步预测;然后通过构造实际落地时刻与预测结果的误差序列,以负反馈方式持续对预测结果进行修正,实现对终端区范围内进港航班的预计到达时刻精准预测;最后,以大型枢纽机场进港航班为例,验证该方法的有效性与实时性。
欧控的BADA项目[12]提出了一套运行性能模型(operations performance model),其由大气物理模型和全能量模型组成,并从航空器类型、质量、飞行包线、空气动力学、发动机推力、爬升功率衰减、燃油消耗、地面移动8个方面来描述航空器属性,本文研究采用BADA输出的航空器性能数据作为飞行模拟仿真基础,并基于运行性能模型描述航空器运动特征。
根据全能量方程,作用在飞机上的力所做的功等同于势能和动能的增加,考虑对时间求导以功率来表示,则有

式(2)即为航空器按照指定速度剖面进行爬升或下降(垂直运动)所需要的能量与同时加速所需要的能量的分配关系。
水平运动方面,本文研究假定航空器严格按照给定航路进行导航飞行。在直线运动阶段,航空器受空中风的影响,其地面投影运动是航空器航向、真空速与风向、风速的合成,有如下关系,即

本文研究中所有方向均以正北为0、顺时针旋转得到。在转弯阶段,转弯率R的计算公式为

在一个转弯过程中,当航空器累积转过的角度大于等于两段航路角度之差时,转弯阶段结束。
在采用四维航迹推演方式计算ETA时,先决条件是能够准确规划和预测航空器航路。基于空管自动化系统实时报文数据[13],可获取航班计划航路以及使用的标准进场(standard terminal arrival,STAR)程序,将其解析为基础航路点,并在航路末端添加落地跑道接地点,即可得到完整计划航路。进一步确定航空器的未飞航路,通过实时航迹数据,以及连续几个周期对同一航空器进行观察,可以确定其位置及运动趋势,并根据航空器与航路段的最小垂直距离,或航空器到航路段两端点的距离,来确定当前所处航路段及未飞航路。
图1所示,其中航空器当前位置为P,A、B、C、DE分别是计划航路上的航路点,用$\overrightarrow{ABCDE}$来表示航路方向,航空器上标注的箭头表示连续几个周期观测确定的运动方向,用$\psi $表示。对于图1(a)情况,有${l}_{1}<{l}_{2}<{l}_{3}<{l}_{4},$且通过$\psi \overrightarrow{AB}>0$可判断航空器运动方向与航路段方向一致,确定航空器处于$\overrightarrow{AB}$航路段,其未飞航路为$\overrightarrow{PBCDE};$对于图1(b)情况,有${l}_{1}={l}_{2}<{l}_{3}<{l}_{4},$取航路中较靠后一段,即航空器处于$\overrightarrow{BC}$航路段,其未飞航路为$\overrightarrow{PCDE};$对于图1(c)情况,当航空器未发生偏置或偏离计划航路时,存在l<ε,且运动方向与航路段方向一致,则认为航空器正处于该航路段,其中ε为固定阈值;对于图1(d)情况,航空器运动方向与最短距离的航路段方向不一致,考虑到航空器转向等情况需要额外的飞行时长,取该航路段起点作为下一导航点,即未飞航路为$\overrightarrow{PBCDE}。$
此外,进场阶段航空器很难按照既定进场程序加入五边排队等待降落,如图2所示,根据一段时间内的雷达航迹汇聚表明,即使采用相同的标准进场程序,航空器在进入五边的时机也各不相同。本文研究在规划预测航空器进入五边的转弯点时,按以下原则进行考虑:①如与使用相同STAR的前机间隔较近,连续落地,则使用前机加入五边的转弯点;②如与前机间隔较远,且空域容量满足STAR需求,按程序规定规划未飞航路;否则,按前机加入五边的转弯点;③如前机未按进场程序直接插入五边,或无可参考的前机,按程序规定规划未飞航路。
按上文提出的航空器运动模型,以规划的未飞航路为输入,可对进场航班的四维航迹进行推演。记当前时刻为T,推演步长为Δt,未飞航路在地面投影的曲线为R,根据式(5)和式(6),航空器在一个周期内的地面移动距离Δd和位移Δx分别为

为区别于下文中在不同时刻做出的预测,使用ETAT表示在T时刻做出的ETA预测。需要说明的是,与其他预测方法[1-7]取得的结果类似,此处的预测结果是粗略的、先验的,在天气良好、航路通畅等常规情况下可以达到较好的效果,但对于突发的管制或气象影响引起的航班波,不能起到很好的作用。下文利用实时航班落地信息对预测结果进行补偿修正。
灰度模型是一种预测模型,由灰色系统理论[14]发展而来,能够在使用较少数据的不确定性背景下,建立对发展趋势的预测。其最典型的GM(1,1)适用于对指数增长进行预测,其核心是通过生成函数将原始数据序列转变为生成指数序列,并建立微分方程模型对数据进行拟合。
设原始数据序列为X(0),通过一次累加生成序列${X}^{\left(1\right)}=\left\{{x}^{1}\right(1),{x}^{1}(2),\dots,{x}^{1}(n\left)\right\},$其中有

由式(11),在T时刻做出的预测为ETAT,t时间后,该航班落地,此时记录实际落地时刻TATA,将该时间与落地前t时间做出的预测结果ETAATA-t进行对比,记录误差

式(25)即对该航班提前t时间的预测误差。保持提前t时间固定,记录一系列实际落地前t时间的ETA预测结果与实际落地时刻ATA之间的误差。
考虑到进港航班使用的标准进场程序并不相同,天气和管制因素对其影响一般以进场程序来区分,因此在对一系列进场航空器构建误差序列时,应首先按照STAR进行分类。在出现天气变化,需要集中对航班进行绕飞、等待等指挥时,由于延误时间的传递,对ETA预测的影响符合指数变化规律,因此可使用灰度模型对ETA误差进行预测。
针对大型航空枢纽机场,由临时空中交通管制措施形成的延误传递通常会在几十分钟内趋于稳定,对于需要预测ETA误差的航班,只有前n个航班落地产生的误差序列对其预测才是有价值的,其中n与实际航班落地间隔有关。记使用同一进场程序的航班${F}_{1},{F}_{2},\dots,{F}_{n}$按落地时间顺序排列,其对应提前t时间的ETA预测误差序列为${P}_{1},{P}_{2},\dots,{P}_{n},$还需考察该序列是否满足式(20)中的条件;在不满足该条件的情况下,求得满足要求的最小平移量,即

即完成了ETA误差序列的构建。在应用式(20)提及的判定条件之前,还需对误差序列进行异常值检测,以剔除序列中的个别异常值。
设使用同一进场程序的航班${F}_{1},{F}_{2},\dots,{F}_{n}$产生的ETA误差序列${P}_{1},{P}_{2},\dots,{P}_{n}$是满足GM(1,1)要求的序列,由灰度模型理论,根据式(18)和式(19)可以预测下一个航班Fn+1的ETA误差为

为保证系数a、b可求解,应用GM(1,1)模型的序列中应至少包含3个值,因此对于一个已剔除异常值的误差序列${P}_{1},{P}_{2},\dots,{P}_{n},$当n<3时,将使用序列平均值$\mathrm{A}\mathrm{v}\mathrm{g}({P}_{1},{P}_{2},\dots,{P}_{n})$替代灰度预测值。将误差${\hat{P}}_{n+1}$应用到对航班Fn+1的ETA预测中,可以得到

记作在T时刻对航班Fn+1的ETA修正预测,其中ETAT,n+1对应于式(11)计算的初始ETA结果。在观测到航班Fn+1落地后,产生了实际误差Pn+1,则相应的误差序列${P}_{2},{P}_{3},\dots,{P}_{n+1}$会用于预测航班Fn+2的误差${\hat{P}}_{n+2},$以此类推。注意到落地前固定时间t并未出现在最终预测结果中,实际上t可作为一个控制量,用于控制需要对提前多久的ETA预测结果做出修正,并可针对不同场景和需求做出变化。
实验以重庆江北国际机场为场景,采集进港航班的计划数据和雷达航迹数据。其中,计划数据包括航班的航班号、二次代码、机型、唯一标识符、航路航线、进场程序和进近程序、落地跑道号等信息;雷达航迹数据包括航班的实时经纬度、标准海压高度、航向、地速、上升和下降率等信息,探测半径约为机场周边300 km。
风速风向等气象数据来源于中国中央气象台10 m全风速数值预报 [15],在重庆机场周边的采样点设定数值预报中提供的风速和风向,采样点间的区域采用二次插值获取所需数值。其他基础数据包括机场地理资料、固定点库、航路航线库、飞行程序库等,由航空资料汇编提取得到。
分别收集良好天气、恶劣天气情况下的连续24 h进港航班数据,从雷达能够探测到目标开始,记录完整雷达航迹和动态计划数据,直至目标落地。
总体仿真流程如图3所示,随时间推移依次读入对应时刻的雷达航迹和计划,模拟实时获取的对应数据,以此为基础对进港航班的未飞航路进行规划和预测;并考虑航空器机型性能、当前飞行状态、未飞航路、风速风向的影响,持续对所有进港航班的四维航迹进行推演。为保证按照实际落地时刻倒推一定时间能够取得当时的ETA预测结果,实验时,在每分钟内都会对每个航班做出数次预测。在航班实际落地后,设定落地前30、20、10、5 min共4个计量时刻,分别按上文所述方法求得对应的ETA预测误差,在使用相同标准进场程序的误差序列累积达到设定的个数时,开始对ETA预测误差进行修正,并同时输出修正前后的ETA预测值用以对比。
首先对航路规划和预测结果进行分析。如图4所示,在正常流量或空闲时段,大多数航班的规划航路与实际雷达航迹基本一致,且航路基本按照标准进场程序发展;图5展示了按时间顺序进场的一系列航班的航路规划情况,在空域繁忙时段或临时管制措施下,航路的规划结果将根据上一个航班的动向而发生变化,在前方航班对进场程序进行了穿越或直飞时,当前航班的规划未飞航路将参考这些直飞点,省略飞行程序中的部分航路点。
对比空闲、正常和繁忙时段航路规划与真实雷达航迹的结果,以单向距离[16](one way distance,OWD)作为衡量轨迹重合度和相似性的指标,计算落地前30 min的规划航路TRoute与雷达航迹TTrack之间的平均距离${D}_{\mathrm{O}\mathrm{W}\mathrm{D}}({T}_{\mathrm{R}\mathrm{o}\mathrm{u}\mathrm{t}\mathrm{e}},{T}_{\mathrm{T}\mathrm{r}\mathrm{a}\mathrm{c}\mathrm{k}})=1.946\mathrm{k}\mathrm{m},$对比平均预测总距离265.719 km,表明所采用的未飞航路预测手段具有合理性和自适应性,能够针对航班和机场空域运行状态的变化做出调整。
对于ETA预测结果的分析,参考实际管制需求,以航班实际落地时刻ATA与落地前30 min预测结果之间的分钟数差值为指标,负值表示ETA晚于实际落地时刻,正值表示ETA早于实际落地时刻。图6展示了恶劣天气下连续24 h对439个落地航班进行ETA预测的误差,其中图6(a)为通过四维航迹推演的原始预测结果,图6(b)为经过误差反馈修正的结果,并按照进场程序不同进行区分。以误差落在±5 min内为评价指标,从原始预测结果来看,由于存在风向风速误差、管制意图无法识别等情况,ETA预测结果与ATA相比整体提前,采用落地前30 min作为计量时刻构造误差序列,对ETA预测结果进行补偿修正后,误差分布大致以0点为中心,可以有效消除系统性误差。
表1按不同进场程序统计了修正前后的准确率,观察到使用进场程序1的准确率在修正后反而有所下降,其主要原因在于原ETA误差以0点为中心波动次数较多,其用于预测的子序列不具备显著的指数发展规律,故而采用GM(1,1)模型预测时反而放大了原误差,导致准确率下降。针对以上439个航班实际做出了415次修正,未做出预测的航班是由于处于误差序列积累过程中,无法启动误差反馈修正机制。表2展示了补偿修正对比的混淆矩阵,结果表明仅有24例得到了错误修正,占比为5.78%,有145例得到了正确修正,占比达到32.29%,其余各例修正不影响最终准确率。
对于良好天气下的ETA误差修正,该方法同样也能取得较好的结果。表3表4分别是良好天气下连续24 h的489个航班的修正预测结果统计,共做出修正465次,其中错误修正的次数为11次,正确修正次数为23次,准确率由92.02%提高到94.48%。图7为修正前后的误差分布对比,同样可以发现,采用该补偿修正机制,集中在正方向的系统性误差被修正为以0点对称分布。
考虑使用不同的误差计量时刻,即分别以落地前5、10、20 min的预测结果构造误差序列,并将误差预测补偿于提前30 min的ETA计算结果上,结果如表5所示,可以看出,设置计量点的提前时间量由于未能完全包含可能发生的系统误差,其预测准确率不及采用提前30 min作为计量点的结果,且准确率随着系统误差发生量的积累而逐渐提升。
进一步考虑到由实际落地时刻所产生的误差序列,需要跳过数个航班才能被当前航班使用,具体跳过的航班数量与实时的落地时间间隔有关。在真实场景下,该参数是无法调整的,但实验中分别设置了不同的间隔航班数量,以对比该补偿修正机制的性能,结果如表6所示。在原预测时刻,间隔的航班数量是不固定的,取决的实时的落地时间间隔,在4~6机之间;随着设定的间隔航班数的减少,观察到修正后的准确率逐渐上升,并在间隔0机(立即将误差应用到需要预测的航班上)时,准确率达到最高。
以上对比实验表明,存在2个关键因素,会对该修正机制的性能产生较大影响,即:①设置提前n分钟的计量点产生误差序列,以及;②需要间隔m个航班传递误差。其中,n的取值越接近提前进行预测的时间值,本文方法的准确率越高;m的取值越接近0,本文方法的准确率越高。
针对参与仿真的共计928个航班,实验中总计进行ETA预测541 439次,按仿真程序在普通个人计算机的单次运行时长统计,每次预测平均用时为0.421 s,最长用时0.683 s,实时性较高,可完全满足空管指挥的现实需求。
提出了基于误差反馈修正的进港航班预计到达时刻预测方法,在使用四维航迹推演的方式计算ETA的同时,还能够基于实际落地时刻与预测值之间的误差序列,对计算结果进行补偿修正。实验表明,通过设置合适的计量时刻,可以有效降低原始ETA预测方式产生的系统误差,能够对管制人员实时指挥调度提质增效,得出以下结论。
(1)在恶劣天气、突发临时管制等情况下,对原始预测结果有较大提升作用。
(2)在良好天气、有序管制的情况下,修正后的预测结果也较为稳定,不会形成过拟合,造成大面积错误修正。
由于序列误差不是一个固定值,在将其传递到原始预测值时会导致修正结果随时间发展跳变,如何保持预测结果的时间稳定性,是下一步研究工作的重要方向。
