Active travel is a major form of physical activity for older adults as well as an important part of their daily transport. However, the non-linear relationship between their active travel and the built environment has been insufficiently revealed. In this study, by utilizing comprehensive travel survey data in Chengdu and multi-source big data, an interpretable machine learning framework (random forest & SHAP model) was constructed to systematically investigate the non-linear impact of community-level built environment factors on older adults’ active travel propensity. The results showed that accessibility to health facilities, the sidewalk index, and the green view index are the most important three factors of built environment affecting older adults’ active travel. Various elements of built environment had complex non-linear relationship with their active travel propensity of older adults, with a significant threshold effect. The effect of built environment indicators such as accessibility to health facilities and the green view index was asymmetric. Specifically, the inhibitory effect of low values far outweighed the promoting effect of high values. This study laid a theoretical foundation and provided scientific support to develop refined intervention strategies aiming at age-friendly cities.

活力出行不仅是老年人重要的体力活动方式,也是其日常出行的关键组成部分。然而,它与建成环境之间的非线性关系仍未得到充分揭示。研究基于成都市综合交通调查数据及多源大数据,构建可解释机器学习框架(随机森林融合SHAP模型),系统解析社区建成环境对老年人活力出行倾向的非线性影响。结果发现,健康设施可达性、步道率和绿视率是影响老年人活力出行倾向最为显著的建成环境要素。各建成环境变量与老年人活力出行倾向之间均呈现复杂的非线性关系,并表现出显著的“阈值”效应。健康设施可达性和绿视率等指标的影响是非对称的:低值带来的抑制作用远远大于高值的促进作用。

活力出行不仅是老年人重要的体力活动方式,也是其日常出行的关键组成部分。然而,它与建成环境之间的非线性关系仍未得到充分揭示。研究基于成都市综合交通调查数据及多源大数据,构建可解释机器学习框架(随机森林融合SHAP模型),系统解析社区建成环境对老年人活力出行倾向的非线性影响。结果发现,健康设施可达性、步道率和绿视率是影响老年人活力出行倾向最为显著的建成环境要素。各建成环境变量与老年人活力出行倾向之间均呈现复杂的非线性关系,并表现出显著的“阈值”效应。健康设施可达性和绿视率等指标的影响是非对称的:低值带来的抑制作用远远大于高值的促进作用。

Active travel is a major form of physical activity for older adults as well as an important part of their daily transport. However, the non-linear relationship between their active travel and the built environment has been insufficiently revealed. In this study, by utilizing comprehensive travel survey data in Chengdu and multi-source big data, an interpretable machine learning framework (random forest & SHAP model) was constructed to systematically investigate the non-linear impact of community-level built environment factors on older adults’ active travel propensity. The results showed that accessibility to health facilities, the sidewalk index, and the green view index are the most important three factors of built environment affecting older adults’ active travel. Various elements of built environment had complex non-linear relationship with their active travel propensity of older adults, with a significant threshold effect. The effect of built environment indicators such as accessibility to health facilities and the green view index was asymmetric. Specifically, the inhibitory effect of low values far outweighed the promoting effect of high values. This study laid a theoretical foundation and provided scientific support to develop refined intervention strategies aiming at age-friendly cities.

全球正经历深刻的人口结构转型,老龄化进程呈现加速态势。根据联合国人口司的统计,全球60岁及以上的老年人口比重预计将从2015年的12% 上升至2050年的22%。中国老龄化形势尤为严峻。国家统计局数据显示:2023年,60岁及以上人口已达2.97亿,占比21.1%;65岁及以上人口突破2.17亿,占比15.4%,标志着中国已进入深度老龄化社会(阈值为14%)阶段。老年人口的快速增长无疑将对社会带来全面、深远且持久的影响。现有研究多聚焦于老年社会保障、医养资源配置、适老化住区建设以及心理健康干预等领域,并形成了一系列应对策略[13]。然而,针对老年人活动及出行问题的研究相对较少,相关研究直至近年来才逐渐陆续出现。
体力活动(physical activity)对老年人身心健康具显著改善效应,如降低心血管疾病风险、维持肌肉骨骼系统健康、缓解抑郁与焦虑等[45]。其中,活力出行(active travel,亦称“主动出行”)作为一种以持续消耗体力实现移动的出行方式,因其日常性与普遍性特征,是提升老年群体健康及福祉的重要途径[6]。值得注意的是,活力出行不仅具有低成本、可持续的优势,还能增强老年人的独立性和自主性,因而成为响应“积极应对人口老龄化”国家战略的重要干预载体。
建成环境(built environment)作为人类活动塑造的物质空间环境,其空间要素(如建筑物、道路、公共设施等)被证实与居民出行行为特征(如出行倾向、频率、时长等)具有显著关联[79]。诸多研究围绕老年人活力出行行为与建成环境的关联机制开展了广泛的实证研究。例如,Zhang等[10]构建了多层次回归模型,探讨了社区建成环境对厦门市60岁及以上老年居民活力出行行为的影响。研究发现,土地利用混合度、交叉口密度、商业中心可达性和公交路线密度与老年人的活力出行行为呈显著正相关。Yang等[11]以日本千叶市为研究案例地,分别构建有序逻辑回归模型和Cox比例风险模型,分析了建成环境对老年人活力出行频次和时长的复杂影响。结果表明,到铁路站的距离显著影响老年人活力出行的频次和时长。Cheng等[12]基于南京出行调查数据,采用零膨胀有序probit模型和Cox比例风险模型,研究了建成环境对老年人活力出行频次和时长的影响,发现土地利用混合度对活力出行的频次和时长均具有显著的正向影响。
现有研究主要依赖线性回归模型与地理加权回归模型[1314]来解析建成环境对老年人活力出行行为的影响机制。尽管这些方法能够有效识别变量间的线性关联,但在揭示复杂非线性关系方面仍存在一定局限性。近年来,部分研究人员开始引入机器学习模型,以探究建成环境与老年人活力出行行为之间的非线性关系,并着力识别关键环境要素的阈值效应。例如,刘吉祥等[15]采用极端梯度提升决策树(XGBoost)模型,研究了建成环境与老年人活力出行之间的非线性关系,发现出行距离是影响老年人是否选择活力出行的关键因素。Yang等[16]基于随机森林模型,揭示了性别差异视角下建成环境要素的差异化影响机制。结果表明,到铁路站的距离对男性活力出行时长的影响最为显著,而人口密度对女性群体的作用更为突出。Guo等[17]通过BO-LightGBM模型,探究了建成环境对老年人活力出行行为影响的区域异质性。结果显示,建成环境变量的影响与区域背景和人口特征密切相关。尽管上述研究通过机器学习模型验证了建成环境与老年人活力出行行为之间的非线性关系,但由于机器学习模型本身的“黑箱”特性,模型结果在可解释性方面仍存在一定局限性。
为弥补现有研究的不足,本文基于2016年成都市综合交通调查及多源大数据,结合随机森林和SHAP(shapely additive explanations)模型,构建了可解释机器学习框架,以探究老年人活力出行行为与建成环境之间的非线性关系和阈值效应。
以中国西部地区的重要中心城市、四川省省会成都市为研究案例地。锦江区、青羊区、金牛区、武侯区和成华区是传统意义上的成都核心城区(即五城区)。截至2022年末,核心城区的土地面积为465 km2,下辖62个街道,共427个社区和2个村。
成都市拥有全国第三大规模的老年人口。根据《成都市第七次全国人口普查公报》数据,全市常住人口为2093.78万人,其中60岁及以上老年人口达376.41万人,占比17.98%;65岁及以上人口为285.12万人,占比为13.62%。随着人口老龄化程度的不断加深,成都市亟需对空间环境进行适老性优化,以应对人口结构转型带来的社会需求。
2016年,成都市开展了综合交通调查,覆盖约34万人,占全市总人口的2.5%。本文基于该调查中的居民出行数据展开分析,数据内容涵盖家庭特征、个人属性、出行特征及意愿等方面。
本文的因变量为老年人的单日活力出行倾向,具体定义为60岁及以上老年人在过去24小时内是否进行了步行或骑自行车的出行。若老年人在该时间段内至少进行一次步行或骑自行车,则因变量取值为1,否则取值为0。需要注意的是,步行5 min(300 m)以内的行为不计入调查范围。经过数据清洗并剔除信息缺失的样本后,最终筛选出15274个来自成都核心城区的老年人样本。
建成环境要素的精准量化是本研究的重要基础。为此,本研究整合多源大数据平台,并引入前沿机器学习算法,不仅提升了建成环境指标测度的准确性与可信度,还为深入探讨建成环境对老年人活力出行行为的多维影响提供了坚实的数据基础。结合“5Ds”经典指标框架(包括密度、多样性、设计、目的地可达性和公共交通可达性[9])以及现有研究[1819],本文选取了7个关键建成环境指标:土地利用混合度、步道率、绿视率、天空率、道路密度、容积率及健康设施可达性。各指标具体测度方法如下:基于Landsat OLI遥感影像数据,在ArcGIS平台进行土地利用混合度测算;通过HRNet语义分割模型对百度街景图像进行深度学习解析,提取步道率、绿视率与天空率指标;依托OpenStreetMap开源数据计算道路密度和容积率;运用高德地图POI数据量化健康设施可达性指标。
本研究的自变量由控制变量和解释变量2部分构成:(1)控制变量表征个人/家庭的社会经济属性,包括性别、个人年收入和家庭规模3个指标;(2)解释变量涵盖土地利用混合度、步道率、绿视率、天空率、道路密度、容积率及健康设施可达性等7个建成环境指标。表 1列出了各变量的定义、解释与赋值方法以及描述性统计结果。
本研究采用随机森林模型,建立老年人活力出行倾向与个人/家庭社会经济属性及社区建成环境之间的关联模型,并借助SHAP模型对机器学习预测结果进行解释。
随机森林是集成学习的代表性方法,由Leo Breiman于2001年正式提出[20]。其核心机理是通过集成多棵决策树的预测结果,形成“群体智慧”,从而显著提升预测精度与稳定性。随机森林通过构建多棵差异化的决策树(采用自举抽样法获取多个子样本,并随机选择特征子集),继而通过投票机制对各决策树的预测结果进行整合,形成最终决策。该方法不仅有效降低了过拟合风险,还显著增强了模型的泛化能力,从而在稳定性和准确性方面表现出色[2122]。相较于传统统计模型,随机森林在以下方面具有显著优势:(1)能够精准捕捉自变量与因变量之间的复杂非线性关系;(2)高效处理高维数据及大规模样本;(3)对缺失数据具有较强的鲁棒性。基于上述优势,本研究选用随机森林方法,以揭示变量间的复杂非线性关系。
本研究基于Python平台的sklearn.ensemble库构建随机森林分类器,并采用网格搜索(grid search)结合五折交叉验证进行超参数优化。参数寻优空间设定如下:决策树数量(n_estimators)参数在10~1000范围内,以10为步长递增;最大特征数(max_features)参数取2~10整数;最大深度(max_depth)参数取1~20整数。共形成1.8万组参数组合。通过系统化搜索,最终确定的最优参数组合为:n_estimators=10,max_features=8,max_depth=20。后续分析均基于该最优参数模型展开。
尽管机器学习模型在预测精度方面具有显著优势,但其“黑箱”特性导致它们的可解释性较差,这在需要明确决策依据的研究领域中显得尤为局限。为解决这一问题,可解释机器学习工具SHAP被广泛采用。它通过量化特征贡献,为预测结果提供理论严谨的解释,从而弥补了传统机器学习模型的不足。
SHAP模型由Lundberg等[23]2017年提出,并于2020年进一步完善。其理论基础源于合作博弈论中的Shapley值——一种公平分配合作收益的数学方法。SHAP的核心机制是通过计算各特征在不同特征组合中的边际贡献,系统评估其对预测结果的影响程度。值得注意的是,SHAP模型具有模型无关性(model agnostic),能够适配多种机器学习算法。Shapley值的计算公式为

式中,ϕi表示特征i的Shapley值;N表示包含所有特征的集合;S表示不包含特征i的任意子集;|S|和|N|分别表示集合SN的大小;fS)表示包含子集S的模型预测结果;fS∪{i})表示包含子集S和特征i的模型预测结果。
混淆矩阵(confusion matrix)是评估二分类模型的工具。它通过统计样本的真实类别与预测类别的组合关系,形成由4个关键元素构成的二维矩阵:真阳性(true positive, TP)表示正类样本被正确预测的数量;假阴性(false negative, FN)表示正类样本被错误预测为负类的数量;假阳性(false positive, FP)表示负类样本被错误预测为正类的数量;真阴性(true negative, TN)表示负类样本被正确预测的数量(图 1)。
通过混淆矩阵可以计算以下指标。准确率(accuracy)通过计算正确分类样本占总样本的比例,直观反映模型的整体预测能力。精确率(precision)针对模型预测的正类结果进行严格评估,定义为真阳性占所有预测为正类样本的比例,强调模型在识别正类时的可靠性。与之互补的召回率(recall)则关注模型对真实正类样本的覆盖能力,计算为真阳性占所有真实正类样本的比例。F1分数(F1-score)作为精确率与召回率的调和平均数,平衡了二者之间的矛盾关系,适用于需要综合评估分类稳定性的场景。准确率、精确率、召回率和F1分数的计算公式为

受试者工作特征曲线(receiver operating characteristic curve,简称ROC曲线)是评估二分类模型性能的重要工具,主要用于展示模型在不同分类阈值下的表现。ROC曲线通过连续调整分类阈值构建,即通过遍历阈值范围分别计算对应的真阳性率(TPR,即召回率)与假阳性率(FPR=FP/(FP+TN)),并将所有阈值下的(FPRTPR)坐标点连接成曲线。该曲线直观反映了模型在提高正类识别能力与控制负类误判风险之间的动态平衡特性。ROC曲线下面积(area under the curve),即AUC值,用于量化模型的分类性能,其通常的取值范围为0.5~1。
本研究首先采用了皮尔逊相关性(Pearson correlation)分析对所有自变量进行了相关性检验,以识别可能存在的共线性(collinearity)问题。如图 2所示,相关性热图直观地呈现了各变量之间的相关性系数。结果表明,所有自变量之间的相关系数均未超过0.7这一阈值,从而确认了自变量之间不存在共线性问题[24]。这一结果增强了机器学习分析的解释力和准确性。
基于混淆矩阵与性能指标对比(图 3表 2),随机森林模型在整体分类性能上优于传统的逻辑回归。逻辑回归虽在正类识别中具有较高的准确率(TP= 10292),但其假阳性占比高达31.8%(FP=4855),导致精确率仅为68.0%,表明其在负类样本的区分能力较弱。相比之下,随机森林通过集成学习优化分类边界,在保持较高召回率(91.8%)的同时,将假阳性样本减少了59.3%(FP=1976),使模型精确率提升至82.8%。此外,随机森林的整体准确率(81.5%)与F1分数(87.0%)均显著优于逻辑回归(分别为67.8% 和80.7%),进一步证明了其在该分类任务中的优势。
ROC曲线分析(图 4)进一步验证了2种模型的性能差异:随机森林的AUC值达到0.89,较逻辑回归(0.60)提升48.3%,表明其在区分正负样本方面具有更强的判别能力。特别是在假阳性率20% 阈值下,随机森林真阳性率高达80%,而逻辑回归仅约26%。综合评估结果表明,随机森林在分析老年人活力出行倾向时,兼具预测精度与稳定性优势,适用于解析建成环境的非线性影响机制。
基于最优参数随机森林模型,本研究借助SHAP模型深入解析了社区建成环境变量对老年人活力出行倾向的影响机制。与传统机器学习模型类似[25],SHAP模型能够展示变量重要度(feature importance)。它通常以SHAP绝对值均值(mean |SHAP|)衡量各变量对预测结果的贡献。图 5(a)展示了各变量的重要度排序。个人年收入(17.85%)、健康设施可达性(14.43%)和步道率(12.11%)对活力出行倾向的影响最为显著,其次为绿视率(9.73%)与天空率(9.57%),而道路密度、土地利用混合度及容积率的影响相对较弱。值得注意的是,人眼视角下的环境要素(步道率、绿视率和天空率)影响较大,这一发现与现有研究结论一致[26]
与传统机器学习模型得出的变量重要度相比,SHAP模型的一个优势在于能够进一步揭示变量的作用方向(图 5(b))。SHAP值的正负可以表征变量对预测结果的贡献方向:正值表示促进作用,负值则反映抑制作用。通过观察高特征值样本(红色)的分布位置,可以判断变量的作用方向——若红色样本聚集在原点右侧(SHAP值>0),则变量呈现正向影响;反之则为负向作用。
以健康设施可达性为例,高可达性样本主要分布于SHAP正值区,而低可达性样本集中于负值区,表明健康设施可达性的提升对老年人活力出行具有显著的正向驱动效应。进一步分析发现,低可达性的抑制作用(SHAP值左尾至−0.25)显著强于高可达性的促进作用(右尾至0.17)。类似地,步道率、绿视率和道路密度等建成环境指标也展现出这种非对称作用。这一结果揭示了空间资源配置的“短板效应”,即设施短缺的制约作用往往强于设施充裕带来的促进作用。因此,消除某些建成环境要素低值带来的抑制作用,比进一步提升高值的促进作用更具干预价值。
本研究采用SHAP散点图(即依赖图)来揭示各变量与活力出行倾向之间的非线性关系。横轴表征变量真实值,纵轴对应SHAP值。图中叠加密度分布(底部浅灰色区域)展示样本聚集特征,并采用局部加权散点平滑法(LOWESS)拟合趋势线[27]图 6揭示了社会经济属性变量与老年人活力出行倾向之间的非线性关系。研究发现,个人年收入与活力出行呈负向关联,高收入群体活力出行意愿较低。性别方面,女性群体的活力出行倾向更高,与现有研究提出的“家庭责任驱动说”相契合[28]。家庭规模在1~5人区间呈现正向促进作用,原因在于家庭成员对老年人活力出行存在激励效应。
图 7展示了重要度排序前6位的建成环境指标与老年人活力出行行为之间的非线性关系。其中,重要度最大的指标——健康设施可达性与老年人活力出行倾向大体上存在正相关关系:健康设施数量越多,老年人的活力出行倾向越高,并在健康设施数量为96时达到峰值。因此,未来社区建设和更新过程中,应优先增加健康设施数量,以促进老年人的活力出行。
步道率与老年人活力出行倾向之间呈倒“U”形的非线性关系。当步道率为2.2% 时,老年人的活力出行倾向达到峰值,这表明在此步道率水平下,其对老年人活力出行行为的促进作用最大。然而,当步道率超过2.2% 时,进一步增加步道对老年人活力出行倾向的提升作用不再显著,甚至产生负向作用。
当绿视率处于0~0.300时,老年人的活力出行倾向随着它的增加而增加,并在绿视率为0.300时达到峰值。这一发现与Yang等[21]针对香港的研究结果相近。绿色植物具有减轻压力、提升情绪的作用,能够激发老年人出门游憩和参与社交活动的兴趣。在一定范围内,增加绿色空间显著促进了其活力出行。但当绿视率超过一定阈值后,进一步增加绿色空间不仅无法继续提升老年人的活力出行倾向,反而可能导致其下降。这可能是因为过高的绿视率意味着其他设施的相对不足,从而限制老年人活力出行意愿。
天空率与老年人活力出行倾向之间存在显著的近似线性负相关关系。具体而言,随着天空率的增加,老年人的活力出行倾向受到显著抑制。这一现象可能源于2个方面:首先,较高的天空率通常意味着较低的建筑密度,这可能导致居民到达重要服务设施(如商店、医疗中心)的出行距离增加,超出适宜的活力出行范围;其次,较高的天空率还可能意味着空间环境中缺乏足够的遮荫和绿化,从而加剧局部热岛效应,进一步抑制老年人的活力出行倾向。
当道路密度低于8.752 km/km2时,其与老年人活力出行倾向呈正相关关系。超过这一阈值后,随着道路密度的增加,活力出行倾向不再提升。道路密度的提升能够改善道路连通性,提供更多的路线选择以及更短的目的地距离,从而促进老年人的活力出行[25]。然而,当道路密度超过某一阈值后,进一步增加道路密度可能无法显著提升可达性,甚至可能导致交通拥堵和环境噪音增加,进而对老年人的活力出行产生负面影响。
当土地利用混合度低于0.206时,它与老年人活力出行倾向呈正相关关系。随着土地利用混合度持续增加并超过0.206这一临界值,其局部效应转为负相关。在土地利用混合度较低时,适度提高混合度可以促进老年人的活力出行。这是因为土地利用混合度的提高能够增加服务设施多样性和可达性,同时缩短出行距离。然而,一旦土地利用混合度超过0.206,进一步增加混合度可能会对老年人的活力出行产生抑制作用。这一现象可能源于过高的土地利用混合度导致环境复杂性增加,进而引发噪音和拥挤等不利因素,从而降低老年人的出行舒适度和安全性,抑制了其活力出行的倾向。
需要注意的是,当道路密度超过20 km/km2或土地利用混合度高于0.55时,老年人活力出行倾向与上述变量之间的关系应谨慎解读。在这些区间内,观测样本较少,可能受到噪声的干扰,从而影响相关结果的可靠性。
本文以成都市为案例,构建了可解释机器学习框架(随机森林融合SHAP模型),系统解析了社区建成环境变量与老年人活力出行倾向之间的非线性关系和阈值效应。主要结论如下。
1)影响老年人活力出行倾向的变量按重要度从高到低排序依次为:个人年收入(17.85%)、健康设施可达性(14.43%)、步道率(12.11%)、绿视率(9.73%)、天空率(9.57%)、性别(7.62%)、道路密度(7.43%)、家庭规模(7.25%)、土地利用混合度(7.24%)和容积率(6.77%)。
2)社区建成环境变量与老年人活力出行倾向之间存在显著的非线性关系和阈值效应。具体而言,当健康设施可达性为96、步道率为0.022、绿视率为0.300、道路密度为8.752 km/km2以及土地利用混合度为0.206时,老年人的活力出行倾向达到最高。
3)健康设施可达性、步道率、绿视率和道路密度等建成环境指标对老年人活力出行倾向的影响是非对称的:低值带来的抑制作用远远大于高值的促进作用。
相较于传统解释工具,SHAP模型具有多个方面显著优势。(1)传统特征重要度指标仅能反映变量对模型预测的全局贡献强度,但无法识别变量的作用方向。相比之下,SHAP模型通过SHAP值分布可视化(图 5(b)),能够清晰揭示建成环境要素对预测结果的作用方向(促进或抑制),将研究视角从“是否重要”的强度认知拓展至“如何作用”的机制解析。(2)SHAP值分布的长尾特征为精准干预提供重要决策依据。例如,健康设施可达性的低特征值呈现左偏长尾现象(图 5(b)),表明其抑制作用强于促进作用。这说明在健康设施方面,“补短板”比“增优势”更具干预价值,从而为有限资源的精准投放提供了科学依据。此外,SHAP模型还具备强大的个体样本解释能力(如瀑布图、决策图和力图),尽管未在本研究中实际应用,但其在个性化空间干预中展现出巨大潜力,可为后续个体层面的研究提供有力支持[2930]
为推动实现老年友好型城市建设目标,本研究提出以下规划策略。(1)优化健康设施布局和步道规划。增加健康设施的数量和可达性,合理配置社区步道,注重安全性和便捷性,以便老年人能够轻松抵达目的地。这不仅能促进老年人的活力出行,还能增强其独立性和社会参与度[3132]。(2)合理控制绿视率和天空率。适度的绿视率有助于提升老年人的心理健康和出行意愿,但过高的绿视率可能导致基础设施不足,影响出行便利性。同时,适度控制天空率可以缓解热岛效应,并确保必要的服务设施和遮荫设施的存在。(3)调整土地利用混合度。根据不同社区的需求,合理规划住宅、商业和公共设施的布局,确保土地利用的混合度既能满足老年人的日常出行需求,又避免因混合度过高而导致的环境复杂性。
未来研究可从以下几个方面展开:(1)探讨建成环境变量之间的交叉效应(interaction effect)和协同效应(synergistic effect)对老年人活力出行的影响,以深化对建成环境与老年人活力出行关系的理解[30];(2)关注建成环境要素与老年人活力出行行为之间的因果关系(causality),以更全面地认识和明晰老年人的出行机制[33];(3)本文以社区设施数量表征可达性,存在未考虑设施需求侧局限。未来可采用2SFCA等模型,考虑供需动态,以提升可达性指标的量化精度[34]
