An oil-paper sample was conducted accelerate thermal ageing treatment, and its ageing process was divided into five ageing stages according to the variation of polymerization degree. Partial discharge tests were conducted on the air gap discharge model, and the PRPD patterns of the oil-paper sample were collected at different ageing stages. The feature quantities were extracted by using statistical operator, the dimension of the original feature data was reduced by factor analysis method, and the clustering characteristics of the feature data before and after dimension reduction were compared. A probabilistic neural network model (PNN) was established to identify the ageing stages of oil-paper insulation, and a back propagation (BP) neural network model and a support vector machine (SVM) model were built as comparison. The three models were trained by the same data, and their recognition results were compared. The results show that ageing will cause pores in the pressboard, which promotes the occurrence of partial discharge. Compared with other models, the FAM-PNN model has obvious advantages in recognition accuracy and operation efficiency. The ageing state of transformer oil-paper insulation can be evaluated accurately and efficiently using the FAM-PNN model.

对油纸试样进行加速热老化处理,根据聚合度变化将其老化过程划分为5个老化阶段;基于气隙放电模型进行局部放电试验,采集不同老化阶段油纸试样的PRPD图谱;利用统计算子提取特征量,采用因子分析法(FAM)对原始特征数据降维,比较降维前后特征数据的聚类特性;建立概率神经网络(PNN)模型识别油纸绝缘的老化阶段,作为对照,搭建反向传播(BP)神经网络模型以及支持向量机(SVM)模型,使用相同的数据对其进行训练,比较三者的识别结果。结果表明:老化会导致纸板内部产生孔隙,从而促进局部放电的发生;与其他模型相比,FAM-PNN模型在识别准确率和运算效率上具备明显优势,使用FAM-PNN模型可以准确高效地对变压器油纸绝缘的老化状态进行评估。

An oil-paper sample was conducted accelerate thermal ageing treatment, and its ageing process was divided into five ageing stages according to the variation of polymerization degree. Partial discharge tests were conducted on the air gap discharge model, and the PRPD patterns of the oil-paper sample were collected at different ageing stages. The feature quantities were extracted by using statistical operator, the dimension of the original feature data was reduced by factor analysis method, and the clustering characteristics of the feature data before and after dimension reduction were compared. A probabilistic neural network model (PNN) was established to identify the ageing stages of oil-paper insulation, and a back propagation (BP) neural network model and a support vector machine (SVM) model were built as comparison. The three models were trained by the same data, and their recognition results were compared. The results show that ageing will cause pores in the pressboard, which promotes the occurrence of partial discharge. Compared with other models, the FAM-PNN model has obvious advantages in recognition accuracy and operation efficiency. The ageing state of transformer oil-paper insulation can be evaluated accurately and efficiently using the FAM-PNN model.

电力变压器是电力系统中最为关键的一次设备,一旦发生故障,将会对整片区域电网造成难以估量的损失。相关资料表明[1],电力变压器最常见的故障是其内部绝缘性能下降所导致的绝缘故障。目前电网中服役的电力变压器主要为油浸式变压器,其内绝缘主要为油纸绝缘[2]。变压器在长期运行过程中其绝缘结构必然会发生老化,使其发生故障的概率逐年升高。因此对运行中的变压器而言,准确判断其内部绝缘的老化程度,对保障电网的安全稳定运行具有重要意义[3]
变压器在生产过程中,因其制造工艺的原因可能会在其绝缘结构中留下一些细微缺陷。这些缺陷在设备运行过程中由于外加电场的作用会导致局部放电现象的发生,从而对变压器内绝缘结构造成一定程度的损伤,长时间累积后会加剧变压器的绝缘劣化。相关研究表明[4-5],局部放电现象与绝缘老化程度之间具有耦合关系,可以利用局放特性随老化程度的变化规律进行绝缘老化状态的评估[6]。G C MONTANARI[7]于1995年提出绝缘的电老化特性与其局部放电密度之间存在函数关系;A CONTIN等[8]探究了局部放电的脉冲幅值分布(PDHD)与老化状态的关系,并证实单纯依靠最大放电量无法准确地进行老化评估;M D Del CASALE等[9-10]在不同环境温度下基于气隙放电模型进行实验研究,结果表明局部放电能量与试样的老化时间之间存在线性关系,并首次提出放电图谱的偏斜度(Sk)可以用于进行老化阶段的评估。近年来,随着数字信息技术的发展,对于局部放电图谱特征量的研究更加深入,统计特征参量开始运用于局部放电老化评估的研究中。廖瑞金等[11-13]通过建立Fisher判别函数、主成分因子的向量聚类分析、GA-BP神经网络模型等方法来评估油纸绝缘的老化状态;王永强等[14]采用粗糙集理论为变压器的故障诊断提供了一种新思路;高竣[15]尝试从油纸绝缘的介电响应频谱中提取特征量,提出了一种基于介电指纹特征的老化评估方法;刘庆珍等[16]采用末端双点解析法确定去极化电流谱线中的弛豫参量,提取出4种可以表征油纸老化状态的新特征量。近年来关于油纸绝缘老化程度评估方法的日新月异[17-18],但是识别准确率以及识别效率仍不够理想。
本研究通过设计气隙放电模型,采集油纸绝缘放电过程的局部放电相位分布(PRPD)图谱,研究不同老化程度下放电特征参量的变化规律,提出基于概率神经网络模型的油纸绝缘老化阶段识别方法。
试样选用厚度为0.5 mm的绝缘纸板,试验前将整张的绝缘纸裁剪成直径为80 mm的圆形纸板,圆心处掏出一个直径为10 mm的孔洞。将处理后的试样装入玻璃容器中,放入120℃、50 Pa的真空干燥箱中干燥2 h,然后按照1∶10的质量比向容器中注入25#变压器油,期间保持干燥箱内真空,油温保持为60℃,浸渍48 h,获得油纸绝缘试样。完成上述操作过程后,将试样密封保存,之后进行加速热老化试验,环境温度设定为130℃。每隔48 h测量一次试样的聚合度,测试结果如图1所示。
图1可知,老化0~336 h时,试样的聚合度变化最为明显,老化336 h之后试样的聚合度变化趋于平缓,到1 200 h左右,油纸聚合度下降至200,绝缘寿命达到终点。将整个老化过程按聚合度数值变化近似五等分,分别在96、192、336、816、1 152 h时取出样品,作为5个最有代表性的老化阶段A、B、C、D、E。
油纸绝缘内部气隙放电模型是一种典型的介质内部放电模型。变压器在制造或维修过程中混入气体使得油纸绝缘内部出现气隙,或者由于油纸绝缘劣化产生分解气体充斥在油或纸、纸板中,形成气泡或气隙,因此形成内部气隙放电。气隙放电实验装置结构如图2所示,装置外壳为直径约为100 mm的聚四氟乙烯容器,上下两层以及中间层都是绝缘纸板,气隙直径为10 mm,长度为0.5 mm,装置上方用有一定质量的瓷质容器盖盖住。此外,为保证人工气隙的密封性,还需用环氧板将油纸板紧紧夹住,并使用绝缘螺钉和螺帽压紧,防止变压器油渗入气隙之中。
局部放电试验系统如图3所示,由实验变压器、局部放电测量单元、人工气隙实验装置构成。其中选用的实验变压器为YDW-30/150型工频无局部放电实验变压器,额定容量为30 kVA,额定电压为150 kV,额定电压下的视在放电量小于5 pC。局部放电测量单元包括JFD-2000型数字局部放电仪、耦合电容以及测量阻抗。实验采用脉冲电流法采集局部放电信号,采用方波作为校准脉冲,所有连接线包裹有屏蔽层以屏蔽外界干扰。加压方式采用阶梯升压法,自试样起始放电电压开始,每隔20 min升压2 kV,每个电压等级下待放电脉冲稳定后开始记录放电数据。
测试得到老化阶段A、B、C、D、E油纸绝缘气隙放电模型对应的起始放电电压分别为9.0、8.8、8.5、8.1、7.8 kV,可以看出随老化程度的加深,气隙放电模型的起始放电电压小幅降低。
图45分别为5个老化阶段下油纸绝缘气隙放电实验得到的放电量-相位(Hq(φ))图谱和放电次数-相位(Hn(φ))图谱,实验电压为20 kV。
图45可知,老化阶段A时,局部放电信号主要分布在一、三象限,表现为100 pC以下的微弱放电脉冲,正、负半周放电次数比较接近;老化阶段B时,放电次数明显增多且整体放电区域朝电压过零点方向偏移;老化阶段C时,放电区域继续偏移,放电主要集中在电压爬升段,最大放电量qmax显著增大;当老化达到D阶段时,放电区域变宽,正负半周放电频率显著增加,尽管qmax提高到3 000 pC以上,但绝大多数放电脉冲放电量仍小于1 500 pC;当老化进行至E阶段时,放电区域遍布整个图谱,qmax突破5 000 pC,正负半周图谱呈现高度相似性。
图6(a)(b)分别为各个老化阶段下油纸绝缘试样平均放电量以及放电次数随试验电压的变化。由图6可以看出,在相同的老化阶段下,随着试验电压等级的提高,油纸绝缘试样的放电量以及放电次数显著上升。在较低电压等级下,不同老化程度油纸绝缘试样的放电量以及放电次数差距较小,难以分离各局部放电特性曲线,且放电次数的数据具有一定的分散性。当电压等级较高时,局部放电各项特征差异增大,可易于区分各老化阶段的局部放电特性曲线。综上所述,划分的不同老化阶段下油纸绝缘气隙放电特性的区别显著,以局部放电PRPD图谱为原始识别对象的油纸绝缘老化阶段识别方法是可行的。
特征量的提取是油纸绝缘老化阶段识别的基础,本研究基于偏斜度(Sk)、峭度(Ku)、峰值个数(Peaks)、不对称度(Asy)、互相关系数(Cc)等5种 统计算子对4种PRPD二维图谱(Hqmax(φ)、Hqn(φ)、 Hn(φ)、Hn(q))进行特征提取,共获得27个特征参量,如表1所示。
其中偏斜度Sk为随机变量的3阶中心距,用以表征图谱相对于标准正态分布图像的偏斜程度,计算公式如式(1)所示。

峭度Ku为随机变量的4阶中心距,用以表征图谱相对于标准正态分布图像的凸起程度,计算公式如式(2)所示。

Peaks为图谱内出现的尖峰个数,即极值数。
不对称度Asy为正负半周数据集求和后的比值,用以表征图谱左右两侧数据的不对称程度,计算公式如式(3)所示。

互相关系数Cc用以表征图谱在正负半周图像形状的相似程度,进而表征正负半周数据的相关性,Cc取值越接近1,则说明左右两侧图形越相似,两侧数据的相关性越高,其计算公式如式(4)所示。

提取得到的特征参量可以很好地描述不同老化程度下油纸试样PRPD图谱中的统计特征。但提取得到的原始特征参量维数过高,若直接作为输入数据必然会大幅降低分类器效率,因此还需在尽可能保证信息完整的前提下,对提取到的特征参量进行降维处理。
现阶段对于局部放电特征的降维普遍存在两种方法,分别是主成分分析法(principal component analysis,PCA)和因子分析法(factor analysis method,FAM),其中PCA法虽然能够更完整地保留特征数据的原始信息,但在处理非线性数据时的区分效果并不理想,因而本研究采用因子分析法对原始特征参量进行降维处理。
因子分析法的算法流程如图7所示。
利用因子分析法对数据进行降维时,首先需要建立各个变量之间的相关系数矩阵R,并计算R的特征根(λ1λ2≥……λn)以及对应的标准正交特征向量(u1u2……un)。对原有的相关变量作如式(5)的线性变换,即可得到原相关变量的主成分向量(F1F2……Fn)。

选择特征根λ≥1的前m个主成分因子作为公共因子,并计算公共因子的因子载荷矩阵A、方差贡献率S以及累计方差贡献率S′,计算公式如式(6)~(8)所示。

接着根据因子载荷对提取出的公共因子进行判定,判断其是否具有明确的物理意义,若判定结果为“是”,则保留公共因子,若判定结果为“否”,则进行因子旋转,使某些变量在某个因子上产生最大载荷,而在其余因子上载荷较小。
最后需要计算原基础特征参量的综合得分,将公共因子载荷矩阵求逆,即可得到因子得分系数矩阵。
以偏斜度Sk为例,经过分析可以看出,由统计算子Sk在4种局部放电图谱中得到的7种统计参量之间具有较强的相关性,可以从中提取公共因子。将5种老化程度共计500组局部放电特征数据进行处理,对各偏斜度特征数组进行变量定义,结果如表2所示。
对定义后的偏斜度变量进行因子分析,计算结果如表3所示。由表3可知,F1F2F3的特征根均大于1,且三者的累计方差贡献率为92.669%,故可以选择F1F2F3作为公共因子来描述原始变量。
为了使提取出的公共因子具备更明确的物理意义以及可描述性,对F1F2F3进行因子旋转,计算结果如表4所示。从表4可以看出,因子旋转后的F1X1X3X5上有较大的的因子载荷,可以代表Hqmax(φ)、Hqn(φ)、Hn(φ)正半周偏斜度的信息,F2可代表Hqmax(φ)、Hqn(φ)、Hn(φ)负半周偏斜度的信息,F3可代表Hn(q)中偏斜度信息。仅丢失原始数据的7.331%的信息量,即可将原有的7维特征向量降至3维。
其他特征参量使用相同方法进行降维,降维结果如表5所示。经因子分析法降维处理后,总计提取出27个特征变量中的11个公共因子,经过降维的公共因子保留了原有特征参量85%以上的信息,物理意义清晰且相互独立。选取250个包含5个不同老化阶段的检测数据进行聚类效果对比,结果如图89所示。从图89可以看出,经过因子分析法降维处理后的聚类特性明显优于降维处理前。
概率神经网络(probabilistic neural network,PNN)是由径向基函数(RBF)网络发展而来的一种前馈神经网络,具有结构简单、易于收敛等优点,其基本结构如图10所示。
与常见的神经网络算法不同,概率神经网络没有迭代算法,仅用前馈神经网络实现输入输出。输入层不作任何运算,仅是将数据样本送入网络,模式层通过权值矩阵与输入层建立关系,计算输入数据与各模式之间的匹配程度,传递函数为高斯函数,然后在求和层计算各模式的条件概率密度,再基于贝叶斯决策估计样本的最大概率,通过输出层输出概率最高的类别。
其中输入层与模式层的连接权值可根据训练效果进行自适应选择,因此PNN模型具有较强的鲁棒性,且训练简单,收敛性强。其具体计算步骤如下[19]

模式距离是指测试样本矩阵与训练样本矩阵相应元素间的距离,假设归一化后的测试样本矩阵为D,共有p个样本,每个样本维数为n,则测试样本与训练样本的欧式距离如式(10)所示。

基于PNN的老化识别系统的输入即为经过因子分析法降维的新11维特征参量F1F2……F11,输出为油纸试样的5个老化阶段。通过气隙放电模式采集5个老化阶段的样本各500组,总计2 500组样本,随机选取80%为训练样本,剩余的为测试样本。
为了比较不同模型的识别结果,本研究建立了传统的BP神经网络模型以及SVM模型,采用相同的数据进行测试,同时为了验证因子分析法降维的效果,本研究将原始27维特征向量输入PNN模型中进行训练,与本研究使用的FAM-PNN模型的识别精度以及运行时间进行比较。其中BP神经网络输入层为11维特征向量;隐含层数为1,包含10个节点,传递函数为tansig,输出层包含5个节点,传递函数为logsig;支持向量机核函数选择径向基(RBF)函数,核参数搜索范围为[0,0.1],惩罚因子搜索范围为[0,100]。识别结果如表67所示。
表67可以看出,基于PNN与SVM算法的老化阶段识别系统的识别率差距不大且都明显优于BPNN,但相较于PNN,SVM运算时间过长,因此PNN模型在识别性能上要优于其余两种模型。而将未经降维的原始数据作为输入的PNN模型,其准确率以及运算效率大幅下降,说明利用因子分析法进行降维可以有效减轻分类器负担,提升识别系统的识别效率。PNN模型的训练集与测试集的识别结果如图11所示,其中训练集的识别准确率为91.2%,测试集的识别准确率为85.4%。综上,使用PNN模型可以对油纸绝缘的老化阶段完成相对准确且高效的识别。
(1)根据聚合度的不同将油纸绝缘试样老化过程分为5个老化阶段,随着老化程度的加深,油纸绝缘局部放电的最大放电量、平均放电量、放电次数均有显著提升。放电集中发生在电压爬升过程中,且逐渐向电压过零处移动。
(2)利用偏斜度等5类统计算子对4种局部放电图谱进行特征提取,共提取出27种原始特征参量,并利用因子分析法将原始的27维特征向量降至11维,新的特征参量保留了原有数据85%以上的信息量,且具备更好的聚类特性。
(3)提出基于概率神经网络的油纸绝缘老化阶段识别方法,并与基于传统BPNN模型及SVM模型的识别方法作比较,发现PNN模型具有更高的识别准确率以及运算效率,更适于油纸绝缘老化阶段的识别。
