In order to study the influence of ageing status of oil-paper insulation of EMU on-board traction transformer on its residual life, the dissolved gas content in oil was used as the characteristic parameter to reflect the ageing of oil-paper insulation in this paper. Since the ageing process of oil-paper insulation has dynamic characteristic, a hidden Markov model was established according to the corresponding hidden state and observation state between the ageing status of oil-paper insulation and the characteristic parameters. Firstly, the number of hidden states is determined using Bayesian information criteria, and then the observation sequence is clustered by using the k-Means algorithm. On this basis, the state of the observation sequence is identified by the Viterbi algorithm to determine the ageing state of oil-paper insulation. Finally, the reliability function is determined by combining the proportional risk model. The accuracy of the model is verified according to the online monitoring data of the dissolved gases in the oil of on-board traction transformer of CRH2 EMU, and it is obtained that the remaining life of the oil-paper insulation is basically consistent with the actual life, which can provide theoretical reference for the subsequent development of traction transformer maintenance strategy.

为考虑动车组车载牵引变压器油纸绝缘老化状态对剩余寿命的影响,本文采用油中溶解气体含量作为反映油纸绝缘老化的特征参量,由于油纸绝缘老化过程中具有动态特性,依据油纸绝缘老化状态与特征参量之间对应的隐藏状态与观测状态建立隐马尔科夫模型。首先通过贝叶斯信息准则确定隐藏状态数目,利用k-Means算法对观测序列进行聚类处理。在此基础上,利用Viterbi算法对观测序列进行状态识别进而确定油纸绝缘老化状态,最后结合比例风险模型确定可靠度函数。通过CRH2型动车组车载牵引变压器油中溶解气体在线监测数据验证模型的准确性,最终得到油纸绝缘的剩余寿命与实际寿命基本相符,从而可为后续制定牵引变压器维修策略提供理论参考。

为考虑动车组车载牵引变压器油纸绝缘老化状态对剩余寿命的影响,本文采用油中溶解气体含量作为反映油纸绝缘老化的特征参量,由于油纸绝缘老化过程中具有动态特性,依据油纸绝缘老化状态与特征参量之间对应的隐藏状态与观测状态建立隐马尔科夫模型。首先通过贝叶斯信息准则确定隐藏状态数目,利用k-Means算法对观测序列进行聚类处理。在此基础上,利用Viterbi算法对观测序列进行状态识别进而确定油纸绝缘老化状态,最后结合比例风险模型确定可靠度函数。通过CRH2型动车组车载牵引变压器油中溶解气体在线监测数据验证模型的准确性,最终得到油纸绝缘的剩余寿命与实际寿命基本相符,从而可为后续制定牵引变压器维修策略提供理论参考。

In order to study the influence of ageing status of oil-paper insulation of EMU on-board traction transformer on its residual life, the dissolved gas content in oil was used as the characteristic parameter to reflect the ageing of oil-paper insulation in this paper. Since the ageing process of oil-paper insulation has dynamic characteristic, a hidden Markov model was established according to the corresponding hidden state and observation state between the ageing status of oil-paper insulation and the characteristic parameters. Firstly, the number of hidden states is determined using Bayesian information criteria, and then the observation sequence is clustered by using the k-Means algorithm. On this basis, the state of the observation sequence is identified by the Viterbi algorithm to determine the ageing state of oil-paper insulation. Finally, the reliability function is determined by combining the proportional risk model. The accuracy of the model is verified according to the online monitoring data of the dissolved gases in the oil of on-board traction transformer of CRH2 EMU, and it is obtained that the remaining life of the oil-paper insulation is basically consistent with the actual life, which can provide theoretical reference for the subsequent development of traction transformer maintenance strategy.

车载牵引变压器作为高速动车组重要能量转换部件,一旦发生故障,将会对动车组列车造成重大损失。牵引变压器随列车运行且长期处于高次谐波、负载冲击、机械振动等恶劣环境,使得油纸绝缘遭受电应力、热应力、机械应力等共同作用而加速老化,导致绝缘性能下降,甚至出现许多内部潜伏性故障。早期采用直流电阻、介质损耗、局部放电测量等电气绝缘特性试验方法来预测牵引变压器油纸绝缘内部故障[1-2],但要求设备停用且故障发展到一定程度才能被检测出来,较难及时发现内部潜伏性故障。牵引变压器油纸绝缘在老化过程中会产生少量H2、CO、CO2及CH4等气体,发生过热、放电等内部潜伏性故障会加快气体产生速率,通过在线监测油中溶解气体成分及含量,从而可以及时掌握油纸绝缘老化状态,进一步预测牵引变压器油纸绝缘的剩余寿命,为视情维修提供理论依据。
近年来,相关学者对油浸式电力变压器剩余寿命预测的研究相对完备[3-6],但对车载牵引变压器剩余寿命的研究较少[7]。廖维等[8]考虑不同冲击载荷对变压器油纸绝缘运行寿命的影响,通过熵值法对油纸绝缘热老化速率进行客观权重评价,以不同老化速率下聚合度和抗拉强度与绝缘纸板寿命间的关系建立模型,但现场检测聚合度为吊芯检查,取样较为困难;高波等[9]通过不同老化阶段的油中溶解气体裂解反应研究变压器油纸绝缘老化机理,结果表明老化初期主要为水解反应,中后期为均解反应且反应加剧,为后续油纸绝缘老化状态评估提供了理论基础。现有研究大多是在实验室条件下对油纸绝缘进行加速热老化试验[10],而车载牵引变压器运行温度为20℃,绕组最热点温升为78℃[8]。在实际运行环境下,目前的研究方法大多属于静态分析法,无法反映油纸绝缘从正常状态逐步发展为严重老化状态的动态过程,且牵引变压器油纸绝缘的老化状态难以直接观测。隐马尔科夫模型(hidden Markov model,HMM)可以有效地探索油纸绝缘老化状态与观测信息之间的关系,且能较好地反映油纸绝缘的老化特性。除此之外,隐马尔科夫模型广泛应用于预测复杂机械设备的剩余寿命。黄林等[11]利用多源传感器数据融合建立高斯混合隐马尔科夫模型,并对航空发动机进行状态识别及剩余寿命预测;F SLOUKIA等[12]通过分析轴承时域和频域信号并将支持向量机与隐马尔科夫模型结合,从而得到滚动轴承的剩余寿命;李韵仪等[13]建立连续隐马尔科夫模型对风机齿轮箱进行性能退化评估并制定维修计划;米琛浩[14]建立隐马尔科夫模型对电力变压器油中溶解气体数据进行分析,最终实现电力变压器健康状态识别及故障预警。
鉴于此,本文对CRH2型动车组在役的牵引变压器进行油中溶解气体监测,综合考虑油纸绝缘受到热-机械-电耦合共同作用的影响,建立隐马尔科夫模型对油纸绝缘老化状态进行合理划分与识别,与符合威布尔分布的比例风险模型相结合,得到不同状态转移时间的可靠度函数,最终计算出各隐藏状态下油纸绝缘的剩余寿命。
在建立隐马尔科夫模型之前,首先要确定模型隐藏状态的数目,目前多数研究直接通过经验指定隐藏状态数目,包含部分不确定性,因此本文采用贝叶斯信息准则(bayesian information criterion,BIC)来确定模型隐藏状态的数目。
首先用主观概率估计出未知的隐藏状态数目,然后用贝叶斯公式修正后验概率,最后利用修正概率寻找最优解。设x1,x2,...,xn为独立同分布,其后验概率为f(gθ),定义N(k)式(1),BIC为式(2)

已知隐藏状态数目,提取观测序列的不同特征,采用k均值聚类算法进行聚类[15]
k均值聚类算法(k-means算法)利用极大似然估计法(expectation-maximum,EM估计法)进行更新迭代参数求解,其关键思想为对于给定的观测值xii=1,2,...,n,根据观测值之间的距离,划分为k个簇,使得每个簇内的值尽可能紧密,簇与簇之间的距离尽可能松散。假设簇为C1,C2,,Ck,则目标为最小化平方误差E,如式(3)所示。

隐马尔科夫模型是一个双重随机过程,其中马尔科夫链用于描述状态之间的转移过程;另一条链用于描述状态和观察序列之间的对应关系,但不具备马尔科夫特性。马尔科夫特性用于描述系统状态之间的内在关系,具有无后效性。观测层的变化未能充分反映状态迁移过程,隐马尔科夫模型能够通过观测序列来感知状态变化和转移过程。图1为基于隐马尔科夫模型的退化状态演化过程,其中,由1到N为隐藏层的隐藏状态,对应的观测层与隐藏层之间存在概率关系,a为当前状态转移到下一转移状态的概率。
隐马尔科夫模型基本参数有5个:
(1)N:模型隐藏状态数目,t时刻的隐藏状态序列为qtq1,q2,,qn
(2)M:模型隐藏状态对应的观测状态,则t时刻的观测序列为ot{o1,o2,,om}
(3)π:初始状态概率,π=(π1,π2,,πN)
(4)A:状态转移概率矩阵,A=(aij)N×N
(5)B:观测值概率矩阵,B=bivmN×M。其中,bi(vm)是在时刻t处于状态qi的条件下生成观测vm的概率。
综上所述,隐马尔科夫模型可以表达为λ=π,A,B,N,M
隐马尔科夫模型存在3个基本问题:
(1)评估问题。已知模型λ,未知观测序列ot及其对应的隐藏状态序列qt
(2)解码问题。已知模型λ,根据观测序列找到对应的隐藏状态序列使得观测序列最优,利用贝叶斯估计可得式(5)

本文采用威布尔比例风险模型(Weibull proportional hazands model,WPHM)结合隐马尔科夫模型建立可靠度函数,将老化状态作为协变量影响牵引变压器油纸绝缘的剩余寿命。具体表达式如式(18)所示。

式(20)式(21)可知,确定形状参数β、尺度参数η和回归参数γ就得到可靠度函数,进一步得到油纸绝缘剩余寿命。由于油中溶解气体是多因素数据,各特征参量对整体油纸绝缘的贡献程度不同,直接采取均值会造成较大误差,因此本文首先用主客观赋值法确定评价指标,然后利用熵权法得到动态权重,具体流程见文献[17]。
综上所述,牵引变压器油纸绝缘基于隐马尔科夫模型与比例风险模型结合的剩余寿命预测流程如图2所示。
热点温升是影响油纸绝缘寿命的重要因素之一,热点处绝缘在电、热、氧气、水分等多种因素协同作用下发生分解反应,其中会产生少量H2、CO、CO2及CH4等气体。绝缘材料老化分解产生的多种气体通过对流、扩散等作用溶解于绝缘油中,因此对牵引变压器进行油中溶解气体分析,可以得到油纸绝缘的老化状态,进一步得到其剩余寿命。
为验证本文模型的有效性,采用CRH2型动车组车载牵引变压器油中溶解气体数据作为观测值,将牵引变压器油纸绝缘的老化状态作为隐藏状态,其部分在线监测数据见表1表1中总烃表示甲烷(CH4)、乙炔(C2H2)、乙烯(C2H4)、乙烷(C2H6)的总和。为消除数据量纲和单位,将数据进行归一化处理,结果如表2所示。
在隐马尔科夫模型中,首先要确定隐藏状态数目进而实现对状态进行划分与识别,本文采用BIC准则判断最优隐马尔科夫模型,根据表2中油中溶解气体数据及式(2)可得BIC识别结果如表3所示。
最佳隐藏状态数目k对应于BIC最小值。由表3可知,当k=4时,BIC=-44.018 3为最小值,因此本文将隐藏状态划分为状态1(正常状态)、状态2(早期老化状态)、状态3(老化状态)及状态4(严重老化状态)4种状态。然后利用k-means算法将特征参量矩阵划分为4类,并根据IEEE标准对油中溶解气体含量进行状态划分[18]
将油纸绝缘隐藏状态划分完毕后,开始对隐马尔科夫模型进行训练。首先,设定初始状态为正常状态,则隐马尔科夫模型λ0的基本参数和初始状态矩阵如式(22)~(24)所示。

确定模型初始条件后,利用Baum-Welch算法根据观测序列进行模型训练,每个隐藏状态都要训练对应的隐马尔科夫模型,训练完毕后,利用Viterbi算法对观测序列进行状态识别,即计算观测序列概率POλi, i=1,2,3,4从而得到每个状态对应的对数似然函数值。对数似然函数值最大时对应的状态表示当前观测序列所处状态,隐马尔科夫模型训练结果如图3所示。
设置训练时最大迭代次数为500,收敛值为0.000 1。由图3可知,训练初期,各状态对应的对数似然函数值迅速增长,迭代次数为10左右时趋于平缓,收敛至固定值。
迭代后的状态转移矩阵和观测值矩阵如式(25)式(26)所示。

在建立基于老化状态的比例风险模型之前,要确定各特征参量在整体中的占比,本文通过熵权法对特征参量进行处理,可得H2、CO、CO2和总烃的权重P=0.2900.2820.2500.178。接着利用极大似然估计法对威布尔比例风险模型进行参数估计,可得形状参数β、尺度参数η和回归参数γ,则基本故障率如式(27)所示,可靠度函数如式(28)所示。

不同老化状态下油纸绝缘剩余寿命与可靠度分别如图4图5所示。
图4图5可以看出,不同老化状态对油纸绝缘的可靠度和剩余寿命影响较大,当可靠度相同时,老化状态越恶劣,油纸绝缘剩余寿命越小。从图5还可以看出,油纸绝缘可靠度为0.9时,正常状态的剩余寿命为10.43年;可靠度为0.8时,正常的剩余寿命为15.54年;可靠度为0.7时,正常状态的剩余寿命为20.07年,这与实际运行油纸绝缘的寿命为20年左右基本相符。
(1)隐马尔科夫模型描述了油纸绝缘从正常状态到失效状态的退化过程,同时结合比例风险模型,避免了隐马尔科夫模型的局限性,符合实际老化情况。
(2)当可靠度为0.7时,油纸绝缘正常运行状态的剩余寿命为19.71年,在实际运行过程中,油纸绝缘的寿命为20年左右,本文分析结果与实际运行寿命基本相符,进一步为牵引变压器维修策略提供了理论基础。
(3)本文主要针对牵引变压器内部潜伏性故障及正常运行老化的油纸绝缘进行剩余寿命预测,对于突发性故障本文所提方法因监测周期长或者刚好遇到故障立马取样导致误差较大,后续可综合各种故障因素对油纸绝缘进行全面老化分析。
