Aiming at the high risk factor of manual fault detection of strut insulators, this paper proposes a real-time fault diagnosis of strut insulators based on thermal imaging technology. The binarized segmentation of the infrared image of the strut insulator was taken as the feature extraction, and the grayscale median filter was introduced for preprocessing, then a Gaussian kernel support vector machine classification architecture was built. At last, the fault diagnosis of the strut insulator was realized. The results show that the diagnosis method can not only complete the fault monitoring of the strut insulator, but also improve the efficiency and accuracy.

针对人工进行支柱瓷绝缘子故障检测危险系数高的问题,本文提出一种基于热成像技术的支柱瓷绝缘子实时故障诊断方法。该方法以支柱瓷绝缘子红外图像二值化分割作为特征提取,引入灰度中值滤波进行预处理操作,构建高斯核支持向量机分类架构,最终实现支柱瓷绝缘子的故障诊断。结果表明:该诊断方法不仅能很好地完成支柱瓷绝缘子的故障监测工作,还提高了检测效率与准确率。

针对人工进行支柱瓷绝缘子故障检测危险系数高的问题,本文提出一种基于热成像技术的支柱瓷绝缘子实时故障诊断方法。该方法以支柱瓷绝缘子红外图像二值化分割作为特征提取,引入灰度中值滤波进行预处理操作,构建高斯核支持向量机分类架构,最终实现支柱瓷绝缘子的故障诊断。结果表明:该诊断方法不仅能很好地完成支柱瓷绝缘子的故障监测工作,还提高了检测效率与准确率。

Aiming at the high risk factor of manual fault detection of strut insulators, this paper proposes a real-time fault diagnosis of strut insulators based on thermal imaging technology. The binarized segmentation of the infrared image of the strut insulator was taken as the feature extraction, and the grayscale median filter was introduced for preprocessing, then a Gaussian kernel support vector machine classification architecture was built. At last, the fault diagnosis of the strut insulator was realized. The results show that the diagnosis method can not only complete the fault monitoring of the strut insulator, but also improve the efficiency and accuracy.

支柱瓷绝缘子(strut porcelain insulator, SPI)是电网系统的重要组成部分[1],通过限制绝缘子表面泄漏电流[2],可以实现对输电线路的保护。支柱瓷绝缘子的绝缘性能受到环境的影响会逐渐下降[3-5],导致绝缘子表面泄漏电流过高,从而严重威胁电网运维人员的生命安全。因此,对支柱瓷绝缘子进行故障检测是十分重要的。
近年来,研究者们对支柱瓷绝缘子的故障诊断开展了研究,并取得一定的成果。文献[6]证明了红外成像技术在瓷绝缘子故障检测方面具有优异性能,并指出绝缘子异常发热故障是由于泄漏电流流动引起的电晕放电和温度上升造成的,同时建议在对输电线路瓷绝缘子进行人工检查时使用这技术。然而,他们只提出了使用热成像技术来完成这项任务,并没有提出使用图像识别的相关技术来扫描和检查瓷绝缘子运行情况。文献[7]提出基于最大熵阈值方法和尺度不变特征变换方法,对红外图像中的绝缘子进行故障诊断。该研究应用中值滤波器对绝缘体红外图像进行去噪,然后使用基于最大熵的阈值算法消除背景信息。然而,在所开发的方法中,由于使用了复杂的特征匹配算法加之故障区域的变化较大,除了计算成本高、检测效率低外,还难以精确定位受影响的区域。文献[8]采用分水岭切割算法对支柱瓷绝缘子红外图像中的故障识别进行图像分割。该方法根据支柱绝缘子故障区域热成像与周围成像不一致的特点,通过支持向量机(support vector machine,SVM)对分水岭算法提取的面积区域进行训练,实现支柱瓷绝缘子的故障诊断。但由于分水岭算法对图像中微小强度变化的敏感性,经常会遇到过分割的问题。文献[9]通过计算纹理特征对无人机拍摄图像中的支柱瓷绝缘子故障进行诊断。通过对绝缘子的长轴、短轴和偏心率进行训练,实现支柱瓷绝缘子有效诊断。同时,其采用纹理特征作为特征提取的方式,很好地解决了过分割的问题。但由于其采用传统的SVM作为训练网络,检测精度并不高。
针对支柱瓷绝缘子的故障诊断问题,本研究提出一种基于热成像技术的支柱瓷绝缘子实时故障诊断方法。根据绝缘子故障部分红外图像亮度高的原理,通过最优阈值算法得到故障绝缘子几何特征,以改进的SVM算法为架构,实现支柱瓷绝缘子状态诊断。
针对支柱绝缘子热成像图像包含噪声和其他伪影的问题,本研究通过图像预处理在分割之前消除这些伪影,以产生良好的检测和分类结果。预处理包括两个主要步骤:①将RGB图像转换为强度或灰度图像;②图像去噪。
对于输入支柱绝缘子热成像图像而言,都包含3个通道的RGB像素分量,即红色、绿色和蓝色。本研究将红色、绿色和蓝色通道转换为二维单灰色通道,以降低时间复杂度、内存需求,仅选择绿色通道进行后续处理以提取感兴趣的对象。灰度变换后的样品热谱图及其对应的红、绿、蓝通道如图1所示。
噪声会通过改变图像像素的强度来修改热分析图中的特征信息。因此,图像去噪被认为是重要的预处理步骤,以使热像图适合后续处理和特征提取。
本研究采用5×5的圆盘形结构元素(structural element,SE)的二维中值滤波器用于降噪,从而提高支柱绝缘子热成像图的视觉质量。为了确定SE为5×5的最佳尺寸,在实际执行分割算法之前对一些样本图像进行了试点实验,发现它最适合研究中的输入图像。应用中值滤波器后的结果如图2所示。
在支柱瓷绝缘子红外图像中,其故障部分经过二值化处理后会产生明显亮度区域。因此,本研究采用最佳阈值算法分割故障区域,并得到绝缘子故障区域的二值化图像。其数学表达式为式(1)

式(1)中:G(i, j)和B(i, j)分别表示灰度图像和变换后的二值图像;αβ是对图像进行阈值处理所需的特定阈值。
使用方程式对灰度图像进行分割以产生二值图像,如图3所示,然后通过处理单元定位捕获图像中的故障区域,最后从分割的二值化对象中提取几何和统计特征。
一般来说,特征提取和选择在构建高效分类器中起着至关重要的作用。根据提取的特征,输出类被标记为3个不同类别中的任何一个,即较少故障、中等故障和严重故障。较少故障的图像可能会被视为正常图像,因为它发生故障的可能性最小。
针对支柱绝缘子检测问题,本研究采用最优阈值分割支柱绝缘子故障部分,并通过区域面积、偏心率和平均强度3种几何特征进行量化处理。这些特征描述如下:
(1)区域面积:区域面积定义为故障区域中的像素值,用于诊断故障类别,区域面积越大,绝缘子的故障情况越严重,如式(2)所示。

(2)偏心率:偏心率定义为长半轴与短半轴的比值,它提供了有关绝缘子故障区域的形状信息,如式(3)~(5)所示。

长轴端点(x1, y1)和(x2, y2)通过计算对象中每个边界像素之间的距离进行确定,而边界像素之间的最大距离被认为是主轴,如图4所示。
(3)平均强度:平均强度定义了被分割区域像素值的平均值,其数学表达式为式(6)

利用上一步提取的特征,构建了基于广义核函数支持向量机(generalized kernel support vector machine,GK-SVM)的分类器来判断绝缘子的健康状况。为了构建分类器,先将统计和几何特征转化为向量集,随后将其分为70%和30%的比例用于培训和测试目的。
GK-SVM从输入特征向量中选择支持向量,并绘制一个超平面对类进行分类。该算法绘制了许多具有支持特征向量的超平面,但只保留那些超平面,这显示了类之间的最大边距。用于两类决策的超平面的数学表达式为式(7)

本文根据这一原理,构建非侵入式健康监测模型,将绝缘子的故障分为3个不同的类别:较少故障(0级)、中等故障(1级)和严重故障(2级)。
虽然线性SVM的性能不适用于多类问题,但GK-SVM在多类问题的情况下获得了很好的结果。因此,本文采用GK-SVM算法对绝缘子进行目视检查和健康状况监测。高斯超平面函数在数学上表示为式(8)

使用Fluke Tis-20热像仪获取450个(每类150个图像)支柱瓷绝缘子的热图图像,采用自适应中值滤波器对图像进行平滑处理,在不改变重要特征的情况下消除噪声影响。此后,本文再对生成的平滑图像应用阈值算法后获得了二进制分割图像,分割图像的增强视图如图5所示。从分割的图像中,提取了统计和几何特征作为输入来构建GK-SVM分类器。首先,GK-SVM分类器使用几何和统计特征进行训练,本文从分割的二元对象(即故障区域)计算这些特征,并分配相应的目标标签。接着,在完成分类器的训练阶段之后,将测试样本图像派生的新特征集作为输入馈送到分类器。最后,GK-SVM在测试特征集和训练特征集之间进行比较,为测试样本图像分配类别标签,实现支柱绝缘子的故障诊断。
使用真阳性率(TPR)、阳性预测值(PPV)、错误发现率(FDR)、假阳性率(FPR)、假阴性率(FNR)和准确度(ACC)等指标来量化和评估所有考虑中的模型的性能。
真阳性率也称为敏感性,用于衡量被系统正确识别的实际阳性候选者的百分比。阳性预测值用于衡量异常区域被预测为异常区域的概率,TPR和PPV在数学上可以表示为式(9)~(10)。

式(9)~(10)中:“真阳性(TP)”是测试做出阳性预测的事件,并且受试者在金标准下具有阳性结果的数量;“假阳性(FP)”是测试做出阳性预测的事件测试做出阳性预测,并且受试者在金标准下有阴性结果的数量;CPPV的理想值为1(100%),最差的可能值为0;“假阴性(FN)”是测试做出阴性预测的事件,并且受试者在金标准下具有阳性结果的数量。
FDR提供有关系统已检测到多少正常(错误)区域的信息,应为总体检测样本中的异常区域。FPR也称为脱落率或误报率。FPR计算为被错误归类为正(假阳性)的负事件数与实际负事件总数(不考虑分类)的比率。FNR是指在二元分类问题中,被错误地预测为负类的样本数量与实际负类样本总数之比,可以有效衡量分类器在负类样本上的错误率。FDR、FPR和FNR在数学上可以表示为式(11)~(13)。
CFDR=FPTP+FP×100%
CFPR=FPFP+TN×100%
CFNR=FNFN+TN×100%
式(12)~(13)中,“真阴性(TN)”是测试做出阴性预测的事件,并且受试者在金标准下具有阴性结果的数量。
准确度简单地计算为正确预测的观测值与总观测值的比值。实际上,任何模型的准确度得分都应该尽可能高,ACC可以在数学上定义为式(14)
CACC=TP+TNTP+TN+FP+FN×100%
本研究给出了不同SVM分类器的仿真结果,并将其性能与其他竞争机器学习和深度学习模型的性能进行比较。分别对不同的支持向量机模型进行训练,观察其性能。根据这些选择更好的制度和性能参数细节,如预测速度(每秒观察次数),不同SVM模型所需的训练时间和准确率如表1所示。
表1可以看出,基于GK-SVM预测器具有更好的精度、较快的预测速度和需要较少的训练时间。因此,本研究采用基于GK-SVM模型来进行绝缘子的故障诊断工作。其混淆矩阵计算所开发系统的性能指标在TPR、PPV和准确性方面如图6所示。其中,混淆矩阵的横轴为预测标签,纵轴为真实标签每个类的标签。
混淆矩阵表示所有分类模型的预测分数,包括所提出的系统。在混淆矩阵里,0级、1级和2级代表故障较少的介质故障和关键故障区域,分别地根据混淆矩阵,该系统成功预测了263个0级故障区域中的258个0级,预测1级为5个。同样,对于1级实际级数样本,系统成功预测了162个1级故障区域,1个归类为0级,6个归类为2级。同时在186个故障中预测了182个故障,成功地将其归为2级,其余4个故障归为1级,如表2所示。在表2中,T(0)、T(1)和T(2)代表每个类别的真实值,而P(0)、P(1)和P(2)代表预测值每一类的价值。
表2可以看出,对于0级、1级和2级,该系统的TPR分别为98%、96%和98%,而对于这些类别,系统的FNR值分别为2%、4%和2%。PPV和FDR也有类似情况。
Resnet-50和DeepCNN是目前绝缘子红外检测领域内较为先进的检测算法。采用两种检测算法对本研究故障样本进行检测,并与本文方法预测结果进行对比,结果如表3所示。从表3可以看出,尽管在过程训练时间方面存在一定不足,但GK-SVM算法在准确率和CPU需求方面要优于另外两种。因此,本文所提算法更适用于实际绝缘子的故障检测。
(1)采用灰度化和SE中值滤波对支柱瓷绝缘子的图像进行降噪和边缘强化对检测精度很好提升效果。
(2)GK-SVM算法对支柱瓷绝缘子故障检测精度和训练时间要比同类型的SVM算法效果更好。
(3)采用本算法进行检测,准确率可以达到97%,且无需GPU硬件配置,适用范围更加广泛。
