To solve the current problem that the monitoring methods of power cable are relatively simple and lack of multi-parameter comprehensive monitoring and judgment, this paper integrated various partial discharge signals of cable joints, and proposed a cable joint fault monitoring method based on deep learning fusion evidence theory. Then fault identification research was conducted for three situations, including no defects, internal insulation defects, and joint moisture in cable joints. According to convolutional neural network algorithm model, the partial discharge signal graphs were trained and tested separately, and data fusion was carried out by D-S evidence theory to realize fault type identification. The results show that for the situation of internal insulation defects and joint moisture, the best recognition effect of single information source is high frequency partial discharge, and its average recognition rate can reach 85.6%, and the average recognition rate of ultrasonic method is the lowest, which is 78.7%, while the average recognition rate of the identify method proposed by this paper can reach 95.7%. When there is a misjudgment in the recognition result of one of the multi-dimensional information sources, D-S evidence theory fusion can eliminate the interference of the wrong information source, accurately identify the discharge type.

为了解决目前电力电缆监测手段相对单一、缺少多参量综合监测判断的问题,本文集成电缆接头的各类局放信号,提出基于深度学习融合证据理论的电缆接头故障监测方法,对电缆接头无缺陷、内部绝缘缺陷、接头受潮三类情况进行了故障识别研究。根据卷积神经网络算法模型,分别对各类局放信号图谱进行训练和测试,再通过D-S证据理论进行数据融合,实现故障类型识别。结果表明:对于内部绝缘缺陷、接头受潮情况,单一信息源识别效果最好的为高频局部放电,其平均识别率能达到85.6%,超声法识别率最低,其平均识别率为78.7%,而本文提出的识别方法平均识别率达到95.7%;当多维信息源中某一信息源的识别结果出现误判时,通过D-S证据理论融合能够排除错误信息源的干扰,准确识别放电类型。

为了解决目前电力电缆监测手段相对单一、缺少多参量综合监测判断的问题,本文集成电缆接头的各类局放信号,提出基于深度学习融合证据理论的电缆接头故障监测方法,对电缆接头无缺陷、内部绝缘缺陷、接头受潮三类情况进行了故障识别研究。根据卷积神经网络算法模型,分别对各类局放信号图谱进行训练和测试,再通过D-S证据理论进行数据融合,实现故障类型识别。结果表明:对于内部绝缘缺陷、接头受潮情况,单一信息源识别效果最好的为高频局部放电,其平均识别率能达到85.6%,超声法识别率最低,其平均识别率为78.7%,而本文提出的识别方法平均识别率达到95.7%;当多维信息源中某一信息源的识别结果出现误判时,通过D-S证据理论融合能够排除错误信息源的干扰,准确识别放电类型。

To solve the current problem that the monitoring methods of power cable are relatively simple and lack of multi-parameter comprehensive monitoring and judgment, this paper integrated various partial discharge signals of cable joints, and proposed a cable joint fault monitoring method based on deep learning fusion evidence theory. Then fault identification research was conducted for three situations, including no defects, internal insulation defects, and joint moisture in cable joints. According to convolutional neural network algorithm model, the partial discharge signal graphs were trained and tested separately, and data fusion was carried out by D-S evidence theory to realize fault type identification. The results show that for the situation of internal insulation defects and joint moisture, the best recognition effect of single information source is high frequency partial discharge, and its average recognition rate can reach 85.6%, and the average recognition rate of ultrasonic method is the lowest, which is 78.7%, while the average recognition rate of the identify method proposed by this paper can reach 95.7%. When there is a misjudgment in the recognition result of one of the multi-dimensional information sources, D-S evidence theory fusion can eliminate the interference of the wrong information source, accurately identify the discharge type.

交联聚乙烯(cross-linked polyethylene,XLPE)电缆以绝缘性能良好、所占空间小、可靠性高、敷设简单等优势,逐渐取代架空线路和油-纸绝缘电缆[1-4]。但XLPE电缆中间接头几何结构繁杂,存在大量复合界面,其电场分布情况比电缆本体更为复杂。此外,电缆中间接头的生产制造以及现场施工过程中,其内部产生杂质、气泡、凸起等随机缺陷的可能性较大,从而成为电缆系统运行过程中故障率较高的薄弱环节[5-8]
因此,电缆接头的缺陷检测受到越来越多学者的关注[9-15]。文献[9]介绍了使用现成的射频传感器进行电缆接头非侵入性局部放电检测的方法,并用于测量含有人工缺陷的35 kV XLPE电缆接头,结果表明,该方法可以同时检测局部放电感应电场和磁场,可以作为电缆接头缺陷的检测手段。文献[10]进行了基于压力波的电缆接头缺陷局部放电检测技术研究,通过与高频电流信号对比,结果表明压力信号能够准确地反映局部放电现象。文献[11]进行了基于线性阻抗谱的配电电缆接头受潮缺陷检测研究,通过现场试验验证了线性阻抗谱技术在配电电缆接头受潮缺陷检测与定位方面的有效性。文献[13]介绍了一种基于内置差分电容的局放检测技术,通过试验证明了该技术与实验室局部放电系统检测的放电相位及响应趋势完全一致,可以精确测量电缆局部放电。文献[16]通过现场应用验证HFCT传感器适用于现场局部放电的带电检测,该传感器具有检测信号灵敏度高、使用方便的特点;但也提出对于电缆局放缺陷,应根据电缆预防性试验数据、家族缺陷等进行综合分析,以此判断信号产生源头。
从上述研究发现,目前的电缆接头故障检测通常是基于单一的传感器与信号源,或者通过两类信号源进行综合分析判断;同时,由于人工巡检的手段单一,加之现场环境的制约,极大提升了人员巡检难度。目前,高频局放、暂态地电压、超声信号均被认为是局放的有效检测手段[17-21]。因此,本文集成高频局放、暂态地电压、超声信号,提出基于深度学习融合证据理论的电缆接头故障监测方法,对电缆接头无缺陷、内部绝缘缺陷、接头受潮三类情况进行故障识别研究,以应对并解决单一参量检测不全、准确性低的问题,达到对电缆接头故障的准确诊断。
为了模拟实际结构,局部放电(partial discharge, PD)试验中使用10 kV定制电缆接头,通过内部预埋缺陷、浸泡试验模拟电缆接头无缺陷、内部绝缘缺陷、接头受潮三类情况。针对内部绝缘缺陷、接头受潮,可分别通过控制预埋缺陷的长度与浸泡时间模拟现场中的轻度和重度缺陷。根据调研结果及运行经验,缺陷长度在1 cm及以下的为轻度缺陷(1类),大于1 cm的为重度缺陷(2类);浸泡时间在48 h及以内的为1类受潮缺陷,浸泡时间大于48 h以上的为2类受潮缺陷。
将样本放入图1所示的测试电路中进行PD测试,该试验电路根据IEC 60270:2015搭建。电源采用无局部放电的可调交流电源,最大输出电压可达50 kV。测试过程中的局部放电检测通过高频局放天线、暂态地电压和非接触式超声传感器实现,频率分别为300~1 500 MHz、3~100 MHz和40 kHz,同时检测阻抗内的分压电容器可获得工频相位参考信息。测量过程中,设置采样时间为15 s。为了与实际运行环境一致,长期试验时设置的施加电压为10 kV。
随着局部放电的发展,在加压过程中采集暂态地电压、高频局放和超声波信号,暂态地电压信号以时域波形展示,高频局放和超声波信号以相分辨局部放电(phase resolved partial discharge,PRPD)图谱形式展示,以内部预埋绝缘缺陷为例,测试结果如图24所示。
图24可以看出,内部预埋绝缘缺陷情况下,暂态地电压、高频局放和超声信号特征图谱均展示出丰富的放电信息。从图2可以看出,在交流电流正半波峰值和负半波峰值处,出现了明显的放电电流脉冲,正、负半周的放电脉冲幅值和数量基本相同,若转化为相位图谱,则放电脉冲基本分布在相位90°和270°附近。
图3图4可以看出,高频局放和超声波信号的PRPD图谱展示的放电相位点基本也分布在相位90°和270°附近,但是不同信号的PRPD图谱特征不同,例如高频局放信号特征图谱相位分布近似为圆形,且最大幅值在-40 dB左右,而局部放电超声信号特征图谱整体呈现三角形,且最大幅值在40 dB左右。
从上述分析可以发现,暂态地电压、高频局放和超声波信号的局放图谱特征明显,因此通过局放图谱识别高压电缆接头故障放电过程是一种可行的方法,而不同信号图谱蕴含的不同特征可以作为故障识别信息的相互补充。
卷积神经网络(convolutional neural network,CNN)是通过模拟大脑分层处理事务的方式来处理大量信息的深度学习方法,能够逐层提取输入图像的特征,建立含有丰富信息的结构模型,进而获得底层特征,更好地进行分类识别。CNN非常适合用来提取本文PRPD图谱的图像特征。利用CNN方法对电缆接头局部放电过程进行识别的流程如图5所示。
首先通过高频局放天线、暂态地电压和非接触式超声传感器采集电缆接头无缺陷、内部绝缘缺陷、接头受潮三类情况的局放数据,然后得到PRPD图谱,对图谱进行收集得到特征数据集。特征数据集分为训练数据集和测试数据集。最后将训练数据集通过CNN方法进行模型的训练,测试数据集用于检验模型的准确度。其中,测试数据集占比为20%,训练数据集占比为80%。
其中,为了准确识别局放类型,本文在检验模型准确度时设计了8层用于局放类型识别的基本网络结构,如图6所示,包括输入层、卷积层、池化层、全连接层和输出层。
①输入层:CNN的输入通常为一张图像,由三维像素矩阵构成,本文为高频局放天线、暂态地电压、非接触式超声传感器采集得到的局部放电图谱;②卷积层:低层的局部区域信息可以通过卷积层中的卷积核激发到更高的层次,提取图像特征则由局部感知完成;③池化层:对特征图的实际大小实现有效的控制,达成数据的降维处理,可依靠相应的池化层聚合统计来完成;④全连接层:利用卷积层和池化层提取的特征进行最后的预测和分类;⑤输出层:当前样本分类的概率分布情况通过输出层得到,通常在分类问题中才使用。
D-S证据理论是一种处理不确定性问题的方法,其本质是将不同信息源的证据信息进行融合,在融合之前需要运用识别框架、基本概率分配函数、信任函数以及似然函数来表征问题的不确定性。
识别框架θ为包含n个元素的集合,θ={A 1, A 2, …, An}。基本概率分配函数m(即mass函数)的函数值反映θ集合中元素的支持程度,mass函数满足式(1)

式(2)~(3)中:|I|为I中元素的个数;AA的补集。
本文的θ由3种放电模型构成的子集组成,其对应的mass函数分别为m 1m 2m 3,子集的元素为放电类型的评估召回率,任意两种类型子集的元素分别为A 1A 2A 3B 1B 2B 3,经D-S证据理论融合后的结果如式(4)式(5)所示。

式(4)~(5)中:m(A)为融合后的mass函数;k为冲突系数,表示证据之间的冲突程度,k值越大,冲突越大。
最终利用得到的各证据的mass函数,即基本概率分配函数(basic probability assignment,BPA)进行融合计算,输出各类证据的共同辨识结论。
结合前文所述基于卷积神经网络的局部放电过程识别方法以及D-S证据理论对高频局放天线、暂态地电压、非接触式超声传感器采集的电缆接头局放数据进行融合,融合流程图如图7所示。
根据前文所述的基于卷积神经网络的电缆接头故障识别方法和D-S证据理论数据融合方法,多源数据融合的电缆接头故障识别过程分为3个主要过程:①基于高频局放、暂态地电压、非接触式超声的数据库进行采集;②分别进行高频局放、暂态地电压、非接触式超声的数据库CNN模型训练;③基于D-S证据理论进行高频局放、暂态地电压、非接触式超声的数据融合,实现故障分类识别。
采集数据集时,由于同一缺陷下的图谱在集簇形状上仍各有不同,为避免训练过程中数据集过少而造成过拟合,本研究通过改变图像亮度、图像模糊程度以及加入随机噪声等将数据集扩大10倍进行训练(不同缺陷的高频局放、暂态地电压、非接触式超声的数据库样本数分别由300个扩充至3 000个)。
对数据集进行模型训练时,基于卷积神经网络的电缆接头故障识别流程如图5所示,卷积神经网络参数及其取值如表1所示。
基于D-S证据理论进行高频局放、暂态地电压、非接触式超声的数据融合,在故障分类识别的过程中,使用高频局放图谱进行电缆接头故障识别作为证据体1,使用暂态地电压图谱进行电缆接头故障识别作为证据体2,使用非接触式超声图谱进行电缆接头故障识别作为证据体3。将PRPD图谱试验结果进行处理,并统计上述3个识别方法的正确率以及融合之后的结果(仅针对故障类别进行统计),如表2图8所示。
表2图8可以看出,预埋缺陷1与预埋缺陷2、内部受潮1与内部受潮2,在相同识别方法下其电缆接头故障识别准确率稍有差别,这是因为不同缺陷程度下的局放信号本身是不稳定也不完全相同的,样本库的采集也存在一定的随机性,导致同一类缺陷下不同缺陷程度的识别准确率有所差别。根据电缆接头故障识别结果可以看出,通过D-S证据理论进行高频局放、暂态地电压、非接触式超声的数据融合对不同缺陷的识别准确率均最高,准确率基本位于95%的水平线上,相比单一的高频局放、暂态地电压、非接触式超声识别效果具有较为明显的优势和可靠性。
此外,若不考虑数据融合,高频局放、暂态地电压、非接触式超声中对电缆内部绝缘缺陷、受潮缺陷识别效果较好的是暂态地电压和高频局放,其中总体上高频局放识别效果最好,平均识别率能达到85.6%;超声的识别效果相对较差,平均识别率仅有78.7%;采用CNN+D-S证据理论的三维信息源融合识别方法平均识别率达到95.7%,这是因为当多维信息源中某一信息源的识别结果出现误判时,通过D-S融合能够排除错误信息源的干扰,准确识别故障类型。
(1)基于单一信息源(高频局放、暂态地电压、非接触式超声)对内部绝缘缺陷、接头受潮进行识别时,高频局放识别效果最好,平均识别率达到85.6%,而超声法平均识别率仅有78.7%。
(2)采用CNN+D-S证据理论的多维信息源融合识别方法比单一信息源模式的识别准确率高,对不同缺陷的平均识别率达到95.7%,识别效果最好。
(3)D-S融合能够排除错误信息源的干扰,准确识别故障类型,适用于通过多维局放信号进行电缆接头故障识别。
