In this paper, we proposed an intelligent recognition method for composite insulator hydrophobicity on the basis of image processing. For the composite insulator images with different hydrophobicity levels, the images were performed histogram equalization and filtering treatments at first, then the water drop/water trace was separated from the background by the Otsu threshold segmentation method, so as to extract clear and complete water drop/water trace contour. The water drop/water trace coverage rate, the maximum water drop/water trace area ratio, and the water drop/water trace average size were used to quantify the water drop/water trace, and the support vector machine was used to establish the feature classification model, so as to realize the hydrophobicity intelligent recognition of composite insulators. The results show that the hydrophobicity intelligent identification method of composite insulator based on image processing can effectively identify seven kinds of hydrophobicity levels, and the average identification accuracy rate is above 80%.

本文提出一种基于图像处理的复合绝缘子憎水性智能识别方法。针对不同憎水性等级的复合绝缘子图像,首先对图像进行直方图均衡化和滤波处理,再利用Otsu阈值分割方法将水珠/水迹与背景分割开,从而提取清晰且完整的水珠/水迹轮廓。采用水珠/水迹覆盖率、最大水珠/水迹面积比、水珠/水迹平均尺寸等特征量对水珠/水迹进行量化,利用支持向量机建立特征分类模型,从而实现对复合绝缘子憎水性的智能识别。结果表明:基于图像处理的复合绝缘子憎水性智能识别方法能够有效识别出7种憎水性等级,平均识别准确率保持在80%以上。

本文提出一种基于图像处理的复合绝缘子憎水性智能识别方法。针对不同憎水性等级的复合绝缘子图像,首先对图像进行直方图均衡化和滤波处理,再利用Otsu阈值分割方法将水珠/水迹与背景分割开,从而提取清晰且完整的水珠/水迹轮廓。采用水珠/水迹覆盖率、最大水珠/水迹面积比、水珠/水迹平均尺寸等特征量对水珠/水迹进行量化,利用支持向量机建立特征分类模型,从而实现对复合绝缘子憎水性的智能识别。结果表明:基于图像处理的复合绝缘子憎水性智能识别方法能够有效识别出7种憎水性等级,平均识别准确率保持在80%以上。

In this paper, we proposed an intelligent recognition method for composite insulator hydrophobicity on the basis of image processing. For the composite insulator images with different hydrophobicity levels, the images were performed histogram equalization and filtering treatments at first, then the water drop/water trace was separated from the background by the Otsu threshold segmentation method, so as to extract clear and complete water drop/water trace contour. The water drop/water trace coverage rate, the maximum water drop/water trace area ratio, and the water drop/water trace average size were used to quantify the water drop/water trace, and the support vector machine was used to establish the feature classification model, so as to realize the hydrophobicity intelligent recognition of composite insulators. The results show that the hydrophobicity intelligent identification method of composite insulator based on image processing can effectively identify seven kinds of hydrophobicity levels, and the average identification accuracy rate is above 80%.

硅橡胶复合绝缘子由于具有优良的耐污闪能力、强度高、质量轻等特性,在电力系统中得到了广泛的应用[1]。然而,由于硅橡胶复合绝缘子工作在户外,极易在严酷的环境下发生老化和损坏[2-7],导致绝缘性能下降、闪络电压降低,从而引发电网故障,造成严重的经济损失。
复合绝缘子表面的憎水性是衡量其老化程度的重要指标之一,为了防止污闪现象的发生,需要定期对复合绝缘子进行人工检查,检测其憎水性能是否达标。由于应用在电网中复合绝缘子数量庞大,通过人工对其憎水性进行检测工作量巨大,导致复合绝缘子的运行维护成为目前的一大挑战。
检测复合绝缘子憎水性的方法主要包括接触角法、表面张力法和喷水法3种[8]。接触角法[9]是通过测量复合绝缘子表面与水滴边缘之间的夹角来表征其憎水性,包括静态接触角法和动态接触角法,其中静态接触角法需要采用接触角测量仪器等设备[10],因此该方法一般在实验室进行。表面张力法[11]是通过在复合绝缘子表面喷洒不同表面张力的液体来反映复合绝缘子的憎水性能,由于喷洒的部分液体对人体有害,因此工程实际中很少采用该方法。喷水法[12]又称喷水分级法,该方法操作简单,是目前普遍使用的方法。喷水法是通过向复合绝缘子表面喷洒一定量的水雾,并在规定时间内观察复合绝缘子表面水珠的分布情况来判断憎水性等级。根据水珠在复合绝缘子表面的形态、尺寸、面积等特征,将复合绝缘子分为7个憎水性等级(hydrophobicity class,HC)HC1~HC7,HC1憎水性最强,HC7代表完全丧失憎水性。检测人员通过与标准HC图像进行对比,进而判断复合绝缘子的HC等级,结果受检测人员专业技术水平的影响较大。
为了克服人工判断复合绝缘子憎水性等级存在的主观影响、效率低等不足,实现憎水性的智能识别,研究者们将图像处理技术应用于憎水性图像的分类。文献[13]将迁移学习的思想运用到复合绝缘子憎水性等级的判别中,利用VGG-19网络融合深度特征与局部特征,构建基于迁移学习和特征融合的复合绝缘子憎水性等级判别模型。文献[14]利用卷积神经网络自动提取复合绝缘子憎水性图像特征,并实现憎水性等级的智能识别。文献[15]提出了一种基于一致性测度区间分类的复合绝缘子憎水性图像处理与识别的方法,通过提取憎水性图像中的水珠/水迹特征,利用支持向量机对所提取的特征进行分类,从而实现复合绝缘子憎水性的智能识别。文献[16]提出多重分形法对憎水性图像的分形特征进行量度,构建标准广义维数谱(Dq-q)曲线用于判断复合绝缘子憎水性图像,实现对未知憎水性图像的识别。文献[17]发现分形维数可表征憎水性图像表面水珠/水迹分布的复杂程度,提出利用憎水性图像盒维数、最大水珠盒维数以及最大水珠盒维数比作为定量分析复合绝缘子憎水性等级的特征参量。
本研究提出一种基于Otsu阈值分割的复合绝缘子憎水性智能识别方法,通过对复合绝缘子憎水性图像进行直方图均衡化、滤波以及Otsu阈值分割,进而提取图像的水珠/水迹特征,构建各憎水性等级特征向量,最后利用神经网络实现憎水性等级的智能识别。
在对复合绝缘子的喷水图像进行拍照后,可以获得整个复合绝缘子的俯视图,俯视图涵盖了复合绝缘子的芯棒和伞裙区域,以及复合绝缘子以外的区域。可以用来判断复合绝缘子憎水性等级的是绝缘子伞裙上的水迹特征,因此,为了方便后续处理,需要截取伞裙区域。本研究根据所拍摄图像的大小,截取像素为700×700的伞裙区域进行分析,如图1所示。
由于RGB图像有三个分量,直接进行处理的计算量较大,而灰度图像只有一个分量,计算方便且计算量较小;另外RGB图像的彩色部分内容对憎水性等级的识别没有帮助,因此,本研究将剪裁后的图像进行灰度化处理,如图2(a)所示。
图2(a)可以看出,灰度化后的图像效果并不理想,对比度不高,水珠/水迹比较模糊。这是由于其灰度级分布不均衡,集中在某一范围内,如图2(b)所示。
为了提高水珠/水迹的清晰度,对灰度图像进行直方图均衡化处理,结果如图3(a)所示。从图3(a)可以看出,经过直方图均衡化后的水珠/水迹变得更加突出,其灰度级分布比较均衡(如图3(b)所示),有利于后续准确提取水珠/水迹特征。
为了进一步增强水珠/水迹边缘信息,去除水珠/水迹内部及图像其他区域的噪声,经综合对比分析,采用双边滤波对直方图均衡化后的图像进行进一步处理,如图4所示。双边滤波是一种非线性滤波方法,是结合图像的空间邻近度与像素值相似度的一种折中处理方法,同时考虑空域信息和灰度相似性,在滤除噪声、平滑图像的同时,又能够很好地保存图像的边缘信息,即双边滤波具有保边去噪的作用。从图4可以看出,双边滤波后的憎水性图像中水珠/水迹边缘更加清晰,且图像整体的清晰度也有较明显的改善。
为了提取水珠/水迹定量特征,需将图像二值化转换为二值图像,再将水珠/水迹分割出来以提取量化特征。选取合理的分割阈值是准确分割出水珠/水迹的前提,如果阈值选取的不合理,那么就无法得到正确的水珠/水迹特征。
Otsu法是一种确定图像二值化分割阈值的算法,该方法又称为最大类间方差法,是图像分割中阈值选取的最佳算法,其计算简单、不受图像亮度和对比度的影响。假设复合绝缘子憎水性图像尺寸为M×N,图像灰度级范围为[0,L-1],灰度级为i的像素点个数为ni,灰度级为i的概率为pi=ni/(M×N)。单阈值分割将图像分割为两类:灰度级为[0,T]的像素点C1类和灰度级为[T+1,L-1]的像素点C2类。设P1(T)、P2(T)分别表示C1类和C2类的概率,u1(T)、u2(T)分别表示C1类和C2类的平均灰度级,则P1(T)、P2(T)、u1(T)、u2(T)可表示为式(1)~(4)。

图5(a)所示的图像为例,基于2.1所述计算方法,对其进行Otsu阈值分割,结果如图5(b)所示。从图5(b)可以看出,经Otsu阈值分割后水珠/水迹边缘较粗糙,含有许多小颗粒噪点,影响后续水珠/水迹特征量的准确计算,因此需要进行处理。
利用开运算结合像素填充的方法解决上述问题。首先利用开运算对水珠/水迹边界进行平滑处理,再对图像中像素点小于200的区域进行填充处理,结果如图6(a)所示。从图6(a)可以看到,经过处理后水珠/水迹的边缘较清晰。图6(b)为伪彩色处理后的图像,可以看出,各个水珠/水迹被成功地检测出来。
对分割处理后的憎水性图像进行水珠/水迹特征值提取,提取水珠/水迹数量fe1、水珠/水迹覆盖率fe2、最大水珠/水迹面积比fe3、水珠/水迹平均尺寸fe4、水珠/水迹形状因子fe5这5个特征量,它们与复合绝缘子的憎水性等级密切相关。各特征量具体定义如下:

表1中给出了各个憎水性等级的典型喷水图像原图、标记的连通区域以及相应的5个特征值。从表1可以看出,不同憎水性等级喷水图像的5个特征量存在较大的差异。
支持向量机(support vector machine,SVM)[18]是基于统计学习理论中的VC维理论以及结构风险最小原理,根据有限样本在模型的复杂性和学习能力之间寻求最佳平衡,以获得最优泛化能力的一种分类算法。鉴于SVM在解决小样本、非线性以及高维模式识别等方面具有的独特优势,本研究选用SVM构建复合绝缘子憎水性智能识别模型。
SVM可以在高维特征空间中建立一个最优分类超平面来正确划分训练样本xi,yii=1,2,…,l,其中xi为第i个输入样本,yi为与xi对应的输出样本,l为训练样本数量。该分类超平面可表示为式(15)

经过一系列的求解,可以得到训练样本的最优分类决策函数,如式(17)所示。

SVM的具体应用可参考文献[19-23],本研究在此不再赘述。
通过喷水分级法获取不同憎水性等级的图像,每个憎水性等级选取70张图像。将7个等级共490张图像依次进行增强、分割与边缘检测处理,最后进行特征提取,把特征值fe1fe5放入Feature的数组中。建立标签数组Label与特征数组Feature之间的对应关系,用于构建SVM模型。随机抽取不同憎水性等级的70%图像用于训练SVM模型,将剩余30%图像用于测试模型的有效性。采用网格搜索法对SVM模型中的惩罚因子C和核函数中的gamma函数g参数进行寻优,其他参数为默认设置。
测试结果表明,利用上述fe1fe5等5维特征,得到的模型识别准确率非常低,仅为20%左右。经过多次试验发现,这是由于水珠/水迹总数及尺寸受拍摄距离的影响,拍摄距离不同,获取的憎水性图像中水珠/水迹总数及尺寸亦不同。如果采用水珠/水迹覆盖率、最大水珠/水迹面积比、水珠/水迹形状因子3维特征,而不采用水珠/水迹数量及水珠/水迹平均尺寸,得到的识别准确率是最高的,说明水珠/水迹数量及平均尺寸不适合作为区分复合绝缘子憎水性等级的特征参量,应舍去。
为了说明测试结果的普遍性,一共进行了5次测试,各次测试的样本均为随机抽取。表2给出了各次测试结果,包括各个憎水性等级的识别准确率以及总识别准确率。从表2可以看出,每次识别的平均准确率均保持在80%以上(平均准确率根据各憎水性等级HC1~HC7识别准确率的平均值计算得到),其中识别HC1、HC2和HC7的准确率基本为100%,综合各次试验结果,得到的平均识别情况如图7所示。
常规复合绝缘子检测方法如接触角法、表面张力法由于需要特殊的设备或试液,一般适用于实验室条件下的憎水性检测;而目前的喷水分级法需检测人员对比标准的憎水性图形,存在费时费力和主观因素影响等方面的不足。本研究提出的憎水性智能识别方法克服了常规复合绝缘子憎水性检测方法的不足,无需特殊设备和试液,能够实现对喷水图像的智能识别,检测效率较高且不受主观性的影响。
(1)通过对复合绝缘子憎水性图像的增强、分割等处理,提取表征憎水性等级的水珠/水迹特征,并利用SVM对提取的特征进行分类,实现了复合绝缘子憎水性等级的智能识别,平均识别准确率在80%以上。
(2)采用水珠/水迹数量、水珠/水迹覆盖率、最大水珠/水迹面积比、水珠/水迹平均尺寸和水珠/水迹形状因子评价复合绝缘子憎水性等级时,识别准确率仅为20%左右。而仅采用水珠/水迹覆盖率、最大水珠/水迹面积比、水珠/水迹形状因子作为识别憎水性等级特征参量时,识别准确率较高。
