In order to reduce safety accidents and economic losses caused by roller failures of underground belt conveyors in coal mines and improve the safety and transportation efficiency of workers and unit equipment,the N-BEATS prediction model with deep structure and residual network was applied to predict the life of rolling bearings for abnormal vibration of roller bearings at different positions under different working conditions. Firstly,the principle and structure of the N-BEATS prediction model were analyzed,and a life prediction model suitable for roller bearings was established based on the N-BEATS principle. Then,a vibration signal monitoring platform for roller bearings based on DVS technology was built against the actual roller operating conditions of a conveyor belt. The vibration signals of roller bearings under different working conditions were collected. Finally,the collected vibration data of roller bearings were input into the N-BEATS model,convolutional neural network (RCNN),and similarity prediction model,and they were compared with the actual values. The remaining life prediction quality of the three types of roller bearings was evaluated. The results show that the N-BEATS prediction model has an average absolute error increase of 5.3% and 4.1%,respectively,compared to RCNN and similarity prediction models. The relative root mean square error of the N-BEATS prediction model is increased by 6.3% and 5.2%.

为减少煤矿井下带式输送机因托辊故障带来的安全事故和经济损失,提高工作人员和机组设备的安全性和运输效率,对于不同工况下不同位置托辊滚动轴承出现的异常振动情况,应用具有深层结构和残差网络的N-BEATS预测模型进行滚动轴承寿命预测。首先,分析时间序列预测模型N-BEATS的原理及结构,并根据N-BEATS原理建立适用于托辊滚动轴承的寿命预测模型;然后,以某矿带式输送机托辊实际运行工况为背景,搭建基于DVS技术的托辊滚动轴承振动信号监测平台,采集不同工况下的托辊轴承振动信号数据;最后,将采集到的托辊滚动轴承振动数据输入到基于时间序列预测模型(N-BEATS)、卷积神经网络(RCNN)、相似性预测模型中,与真实值进行对比,并评估3种托辊滚动轴承剩余寿命预测质量。结果表明:N-BEATS预测模型相对于RCNN和相似性预测模型,其平均绝对误差分别提升了5.3%和4.1%;N-BEATS预测模型相对均方根误差分别提升了6.3%和5.2%。

为减少煤矿井下带式输送机因托辊故障带来的安全事故和经济损失,提高工作人员和机组设备的安全性和运输效率,对于不同工况下不同位置托辊滚动轴承出现的异常振动情况,应用具有深层结构和残差网络的N-BEATS预测模型进行滚动轴承寿命预测。首先,分析时间序列预测模型N-BEATS的原理及结构,并根据N-BEATS原理建立适用于托辊滚动轴承的寿命预测模型;然后,以某矿带式输送机托辊实际运行工况为背景,搭建基于DVS技术的托辊滚动轴承振动信号监测平台,采集不同工况下的托辊轴承振动信号数据;最后,将采集到的托辊滚动轴承振动数据输入到基于时间序列预测模型(N-BEATS)、卷积神经网络(RCNN)、相似性预测模型中,与真实值进行对比,并评估3种托辊滚动轴承剩余寿命预测质量。结果表明:N-BEATS预测模型相对于RCNN和相似性预测模型,其平均绝对误差分别提升了5.3%和4.1%;N-BEATS预测模型相对均方根误差分别提升了6.3%和5.2%。

In order to reduce safety accidents and economic losses caused by roller failures of underground belt conveyors in coal mines and improve the safety and transportation efficiency of workers and unit equipment,the N-BEATS prediction model with deep structure and residual network was applied to predict the life of rolling bearings for abnormal vibration of roller bearings at different positions under different working conditions. Firstly,the principle and structure of the N-BEATS prediction model were analyzed,and a life prediction model suitable for roller bearings was established based on the N-BEATS principle. Then,a vibration signal monitoring platform for roller bearings based on DVS technology was built against the actual roller operating conditions of a conveyor belt. The vibration signals of roller bearings under different working conditions were collected. Finally,the collected vibration data of roller bearings were input into the N-BEATS model,convolutional neural network (RCNN),and similarity prediction model,and they were compared with the actual values. The remaining life prediction quality of the three types of roller bearings was evaluated. The results show that the N-BEATS prediction model has an average absolute error increase of 5.3% and 4.1%,respectively,compared to RCNN and similarity prediction models. The relative root mean square error of the N-BEATS prediction model is increased by 6.3% and 5.2%.

带式输送机处于煤炭运输系统的中枢环节,其托辊滚动轴承的性能会随使用时间的增长逐渐衰退,且这一退化过程受到工作环境、负载状态等多种因素影响,呈现出不确定性和非线性的特征[1]。其一旦出现故障,会导致输送带撕裂、零部件挤压变形,将造成物料的大量堆积,并因链式反应而导致矿井停产造成经济损失,引起安全事故,更严重的会造成人员伤亡[2]
鉴于此,笔者拟提出一种基于时间序列预测模型(Neural Basis Expansion Analysis for Interpretable Time Series Forecasting,N-BEATS)的托辊滚动轴承剩余寿命预测方法,通过搭建带式输送机托辊轴承故障检测试验台,采集不同工况下托辊的振动信号,并将该托辊滚动轴承剩余寿命预测模型与区域卷积神经网络(Regions with Convolutional Neural Networks,RCNN)和相似性预测模型对比,以期提高托辊滚动轴承剩余寿命预测精度。
传统的时间序列分析法通常涉及趋势变化、周期变化、不规则波动和循环波动等变化状态的叠加或耦合。N-BEATS 的基本架构如图1所示。N-BEATS 神经结构由多个栈组成,每个栈由多个块结构组成。块结构的上半部分是一个完全连接的4层全连接网络,K为时间序列分解层数,经过2个分支分别输出前向 θ l f和后向 θ l b的预测系数。这里的预测系数可理解为存储着时间序列信息的低维向量;块结构的下半部分计算式如下:

多个块结构连接在一起形成一个栈,并且整体上以双重残差结构展现,内部还包括前向预测残差分支和后向预测残差分支。在后向预测残差分支中,将每个块结构的(yb) y ^ l及其接收的整个输入残差值作为下一个块结构的输入,最终作为下一个栈的输入。而在前向预测残差分支中,将每个块的输出(yf) x ^ l进行累加,作为对应栈的输出,而模型所有栈的输出则是这些部分输出的累加结果,最终构成了整体的输出。
块是N-BEATS 网络中的最小组成单元之一,块与堆栈结构如图2所示。图2展示了第1个块的结构。每个块都接受1个输入,并产生2个输出值。对于第l个块,其输入xl来自整个模型的输入x,而第l块的输入xl来自第l-1块的残差输出。第1个块分别产生2个输出值,分别是回溯(b) x ^ l元和预测(f) y ^ l元,通常情况下,回溯值的长度是预测值长度的2~7倍。上述过程可由下列公式表示:

式中:C为带有Relu激活函数的非线性全连接层;hl,1为第l个块中第i层经过C后生成的映射;wl,1为神经元的权重 ;bl,1为神经元的偏置; θ l f θ l b分别为第l个块的正向预测基展开系数和后向预测基展开系数;LINEAR为不带有任何激活函数的线性映射层。 θ l f θ l b会通过 G l f G l b函数生成预测输出和回测输出,其中, G l b能够移除不利于后续预测的信息,而 G l f能够用来优化当前块预测输出的精度。G函数是可以配置的,通过选择不同的函数能够消除输入序列的不同成分。
堆栈(stack)是N-BEATS网络中的另一种单元结构,图2中为第1个堆栈的结构。堆栈采用双残差拓扑结构,与块的输入输出类似,包含1个输入和2个输出。第1个堆栈的输入等于整个模型的输入,而其他堆栈的输入 x ^ l来自上1个堆栈传入的残差。每个堆栈会输出1个预测值 y ^,该预测值是所有块预测的叠加总和。上述过程可表示为:

式中:xl为某个栈中第l块的输入;xl-1为某个栈中第l-1块的输入; x ^ l - 1为第l-1个块的后向预测残差; y ^为每个堆栈输出的预测值; l y ^ l
研究滚动轴承的剩余寿命预测实质上是选取能代表退化趋势的指标,进行非线性回归预测。应用神经网络预测时,通常需要讨论单变量多步预测问题。单变量多步预测结构包括直接预测结构、递归预测结构和直接递归预测结构。在这些结构中,递归预测指的是在预测时使用相同预测模型的多个周期,并将上一个周期的预测值作为下一个周期预测的输入。该过程的计算过程如下:

式中:h为已经预测的长度;N为待预测序列的长度;d为输入变量的长度;H为需要预测的总长度。直接预测是指当需要预测序列的总长度为H时,使用M种不同的模型分别预测每个待预测的值。该预测结构将序列视为独立数据,忽略了变量之间的相关性。
直接预测法精度较低,其预测模型计算过程如下:

利用数据集进行剩余寿命预测时,总是希望在历史数据相对较少的情况下预测的结果更准确,以更好地对轴承健康时间做出正确判断。因此,需要借助递归预测结构进行预分析,而 N-BEATS 应用的原理是直接预测结构,因此,文中将2 种结构相结合以提高精度。即将上一个周期的预测值作为下一个预测周期的数据集的一部分,其预测模型如图3所示。
其中,t为输入变量的长度;n为1个周期预测周期的长度;m为预测周期的个数。
试验系统的硬件设施包括滚动轴承故障试验台、振动信号光纤、不同故障类型的滚动轴承、数据采集系统。试验中采用的带式输送机托辊滚动轴承故障试验系统如图4所示,试验系统运转时,轴带动轴承内圈固定不转,轴承外圈旋转。采集到的振动信号通过特征提取、故障诊断等智能分析上传到客户端以监测设备状态。
分布式光纤主要用于监测振动信号,故选择4芯单模光缆,常见的单模4芯光缆的光纤直径为9/125 μm,可用于连接不同的设备或模块以实现高速数据传输和通信。根据现场地形、设备和其他障碍物,为使光缆能尽可能达到使用效果,选择将光缆铺设于槽钢上部或内部。
为使光纤诊断更加准确,选择铺设20 m光纤进行对比试验,前10 m光纤采用打孔安装,后10 m光纤直接安装在槽钢上部。铺设完成后安装光纤接头盒和其他光缆附件。将铺设的20 m光纤处更换上输送机损坏托辊,经过多次测试和试验,能及时诊断出现故障的部位并报出相关位置,并通过对比,得出打孔布置的光纤检测故障振动信号更强。
试验设计包括3种工况,每种工况的数据集中的转速和径向力各不相同。转速主要由交流电机的转速控制器设置和调节,而径向力则由液压加载系统产生。施加在轴承中的3种工况见表1
通过测量振动加速度获取滚动轴承剩余寿命预测数据集。在不同工况下,滚动轴承的剩余使用寿命和失效位置各不相同,详细介绍见表2
试验采样频率设置为25.6 kHz,采样间隔为1 min,每次采样时长为1.28 s。文中选取工况1中的轴承1_4,工况2中的轴承2_4以及工况3中的轴承3_3进行算法验证,训练集与验证集划分见表3
选取轴承1_4的退化阈值作为起始预测点,以及10个数据点作为历史数据集。在第1个周期进行了5个数据点的预测,然后将预测得到的数据点与历史数据共15个点一起作为神经网络的输入,以预测下一个周期的5个数据点,共进行2个周期的预测。N-BEATS方法与其他2种方法的对比结果如图5所示。
N-BEATS方法以轴承2_4的退化阈值作为起始预测点,并选择了85个数据点作为历史数据集。在第1个周期进行了25个数据点的预测,随后将预测得到的数据点与历史数据共110个点作为神经网络的输入,用以预测下一个周期的45个数据点,共进行2个周期的预测。该方法与其他2种预测方法的对比结果如图6所示。
采用轴承3_3的退化阈值作为起始预测点,并将该点作为起始点,选择25个数据点作为历史数据集。在第1个周期进行了15个数据点的预测,然后在第2个周期进行了7个数据点的预测,总共进行2个周期的预测。该方法与其他2种方法的对比结果如图7所示。
在采集的托辊滚动轴承剩余寿命数据集中,每个数据点代表1 min。如果预测的退化指标值等于失效阈值,可以判定滚动轴承已经失效。则可以将退化指标中从起始预测点到失效阈值所经历的数据点转换为滚动轴承的剩余使用时间。数据集中的剩余寿命比例如图8所示。
为评估预测效果,使用平均绝对误差和相对均方根误差作为准确率的度量标准。计算过程如下:

式中:yr为第i时刻的真实值;yi为第i时刻对应的预测值;s为数据长度。
评价辊滚动轴承寿命预测效果时,计算了3种工况下预测值的平均绝对误差和相对均方根误差,分别见表4表5。针对文中提出的算法,发现相对于RCNN和相似性预测模型,其平均绝对误差分别提升了5.3%和4.1%,相对均方根误差分别提升了6.3%和5.2%。
表4表5可知:对于3种不同工况下的轴承寿命预测数据集,文中提出的预测神经网络和预测结构均展现出较传统算法更好的预测效果。
1) 将N-BEATS模型与RCNN和相似性预测模型对比,相对于RCNN和相似性预测模型,N-BEATS模型平均绝对误差分别提升了5.3%和4.1%。
2) N-BEATS模型相对于RCNN和相似性预测模型,其相对均方根误差分别提升了6.3%和5.2%。
3) 目前仅分析和对比了N-BEATS模型、RCNN和相似性预测模型下的寿命预测,存在一定局限性,下一步将N-BEATS预测模型和更多模型对比,进一步提高寿命预测精度。
