To solve the current safety risk issues of UAV operations in low-altitude urban environments,a FBN was used to identify and analyze the key risk factors of low-altitude UAV operations. Firstly,risk factors were analyzed from the perspective of human-machine-environment-management based on operation process of low-altitude UAVs. GeNIe software was used to develop a Bayesian network(BN) for risk assessment of low-altitude UAV operations,and the prior probabilities of the underlying events were analyzed using expert prior knowledge and fuzzy sets. Finally,univariate,bivariate,and sensitivity analyses were performed,and the network feasibility was validated. The results indicated that the key risk factors for low-altitude UAV operation were UAV battery failure,environmental obstacles on the operation route,and UAV operation supervision technology. FBN reverse inference showed that environment-related risk (79%) and UAV equipment risk (60%) were the main risk factors in the UAV operation process.

为解决目前城市低空环境下的无人机(UAV)运行安全风险问题,利用模糊贝叶斯网络(FBN)识别和评估低空无人机运行的关键风险因素。首先,在分析低空无人机运行流程基础上,从人-机-环-管角度分析低空无人机运行过程的风险因素。随后,利用GeNIe软件构建低空无人机运行风险评估贝叶斯网络(BN),利用专家先验知识和模糊集量化分析底事件的先验概率。最后,开展单因素分析、双因素分析以及敏感性分析,并以实例验证网络可行性。研究结果表明:低空无人机运行的关键风险因素为无人机电池故障、运行航线的环境障碍物以及无人机运行监管技术;FBN反向推理分析结果显示,环境相关风险(79%)、无人机设备风险(60%)是无人机运行过程主要风险因素。

为解决目前城市低空环境下的无人机(UAV)运行安全风险问题,利用模糊贝叶斯网络(FBN)识别和评估低空无人机运行的关键风险因素。首先,在分析低空无人机运行流程基础上,从人-机-环-管角度分析低空无人机运行过程的风险因素。随后,利用GeNIe软件构建低空无人机运行风险评估贝叶斯网络(BN),利用专家先验知识和模糊集量化分析底事件的先验概率。最后,开展单因素分析、双因素分析以及敏感性分析,并以实例验证网络可行性。研究结果表明:低空无人机运行的关键风险因素为无人机电池故障、运行航线的环境障碍物以及无人机运行监管技术;FBN反向推理分析结果显示,环境相关风险(79%)、无人机设备风险(60%)是无人机运行过程主要风险因素。

To solve the current safety risk issues of UAV operations in low-altitude urban environments,a FBN was used to identify and analyze the key risk factors of low-altitude UAV operations. Firstly,risk factors were analyzed from the perspective of human-machine-environment-management based on operation process of low-altitude UAVs. GeNIe software was used to develop a Bayesian network(BN) for risk assessment of low-altitude UAV operations,and the prior probabilities of the underlying events were analyzed using expert prior knowledge and fuzzy sets. Finally,univariate,bivariate,and sensitivity analyses were performed,and the network feasibility was validated. The results indicated that the key risk factors for low-altitude UAV operation were UAV battery failure,environmental obstacles on the operation route,and UAV operation supervision technology. FBN reverse inference showed that environment-related risk (79%) and UAV equipment risk (60%) were the main risk factors in the UAV operation process.

近年来,随着人工智能技术、视觉高清技术、云计算技术,以及通信技术和高精度定位技术的发展,无人机(Unmanned Aerial Vehicle,UAV)应用场景和领域日益扩展和丰富。尤其在城市低空运输领域,民众对运输高时效的需求日益迫切[1-2],城市低空无人机在快递物流、外卖配送、医疗运输等场景得到了试点和应用。与此同时,由于城市低空运输具有人口密度大、电磁环境复杂、限制性空域多、高大障碍物众多等特点,城市低空无人机运行过程失效坠落、隐私泄露等安全问题日益严峻[2-3],如何确保城市低空无人机安全运行,成为当前各界关注的热点问题。
基于贝叶斯网络(Bayesian Networks,BN)的概率安全评估方法能够有效地将专家经验、历史数据以及各种不完整、不确定性信息综合起来,提高建模效率和可信度,节省安全性信息获取成本[4]。诸多学者采用该方法开展了复杂事故的风险定量分析,如马港等[5]采用BN方法分析了电镀企业火灾事故的发展趋势并推理事故演化路径;贾晓惠等[6]融合专家知识建立BN网络,分析了公交车事故重要致因因素;屈静等[7]采用动态BN方法,研究了输油管道泄漏事故发生风险概率较高的情景状态;鲁义等[8]利用BN模型探讨了特定条件下的事故发展趋势和事故演变过程;陈雍君等[9]使用模糊贝叶斯网络评价了地下管廊的风险水平并确定关键因素;成连华等[10]使用模糊贝叶斯网络评估了高层建筑火灾风险,量化了高层小区的风险等级;郑来[11]通过模糊故障树和BN分析了特大交通事故的致因。此外,在民航飞行安全和无人机运行安全领域,刘俊杰等[12]量化分析了可控飞行撞地风险,利用BN得出民航可控飞行撞地的关键风险环节;蒋骏贤[13]运用BN分析了牵引飞机过程的危险源和风险控制;岳仁田等[14]基于BN灵敏度分析确定了控制策略的最优组合,分析了民用无人机重点防范的致因节点;韩鹏等[15]通过构建无人机故障失效概率模型,利用BN风险评估模型研究了无人机运行过程失效诱因;李航等[16]使用BN模型评估了城市物流无人机碰撞风险,分析了无人机发生碰撞事故的关键因素和敏感因素。
上述针对特定领域和对象的研究取得一定成果,具有较高的理论价值和应用价值,但针对低空无人机复杂环境领域研究较少。鉴于此,笔者拟针对低空无人机运行所面临的复杂运行环境,基于模糊BN(Fuzzy BN,FBN)贝叶斯对低空无人机运行展开风险评估;从无人机运行基本情况出发,确定运行过程中的风险因素作为分析的节点,利用专家意见、事故报告和无人机运行风险因素构建BN结构;利用专家知识确定BN的先验条件概率,在GeNIe软件中构建BN分析模型,作模型的推理和敏感性分析,以期寻求低空无人机运行过程的关键风险因素,为低空无人机运行保障主要方向提供理论参考。
低空无人机主要以城市低空空域作为运行环境,运行流程主要包括准备阶段、起飞阶段、航线运行阶段和着陆阶段。通常来说完整运行的低空无人机航线均需要配备起降点、运行航线、应急备降点和应急程序,低空无人机运行流程如图1所示。
经过准备阶段后,由操作员操作或执行自主程序从起飞起降点出发,经由进离场到达指定高度,进入航线飞行阶段。到达目的机场之前,如遇飞行故障,在可控状态下可以在应急程序就近迫降,最终到达相应的应急备降点。无人机运行的各阶段都存在各种因素导致不安全事件的情况,虽然考虑部分风险因素为无人机运行设置应急通道,但是,该方法仅在无人机可控状态下才能实现,无人机失控坠地或撞击建筑物等的危险仍不可忽视。
无人机运行过程中,由于无人机、环境、人为操作等原因导致的故障不可忽视,可获取的低空无人机的事故报告样本较少,难以进行定量分析与研究,仅可从中提取无人机运行过程的风险因素作为参考。通过实际调研,总结国内某无人机运营单位的无人机运行异常事故报告,从人-机-环-管角度分析无人机运行风险因素,得到无人机异常事故汇总,见表1
考虑到低空无人机运行过程难以识别出其运行中所存在的风险因素,通过专家经验知识整理和总结的风险因素分析如下:
1) 人员因素。低空无人机运行过程涉及到的人员主要是无人机操作员和监管人员。无人机操作员和监管人员的状态与无人机运行安全密切相关,运行过程的差错会直接导致无人机运行事故发生。
2) 无人机因素。无人机是复杂的软硬件匹配多智能体,针对低空无人机,还需要考虑其搭配有效载荷,即无人机机载货舱与货物。考虑后续基于BN的低空无人机风险评估模型的复杂性,将无人机因素分为硬件、软件、机载货舱及电池4个方面。
3) 运行环境因素。低空无人机运行环境对无人机运行安全至关重要,综合考虑环境影响因素将其分为气象环境、飞行服务信息环境、环境障碍物以及无人机起降场助航设施。
4) 运行管理因素。低空无人机运行管理主要依据管理手册和标准规范,将风险划分为运行及操作程序不完善、风险管理流程不完善。
综合考虑低空无人机运行安全需求,低空无人机风险评估指标体系如图2所示。
BN方法将图的传递逻辑与概率论相结合,通过图形演示直观地表示节点之间的因果关系[4]。该网络包含节点、边(弧)和节点的条件概率表(Conditional Probability Table,CPT)。节点代表随机的因子,边的指向性阐述了节点之间的相互关系,条件概率体现了节点之间影响的程度。
在确定节点的初始概率值后,得到包含所有节点的联合概率分布,简化后的BN联合概率分布函数P(R)如下:

式中x1x2,…,xnRn的一个互不相容的完备事件组,任意i节点的概率p(xi)>0,其中,i∈(1,n),R(xi)为节点xi的集合。
BN建模是一个定性和定量相结合的过程,利用有向无环图来表示各节点之间的相互依赖关系(定性分析),并利用概率理论描述各节点的概率分布来直接反映相应节点之间的影响程度大小(定量分析)。因具有将定性与定量相结合的优势,BN方法被应用于诸多领域不确定性问题的相关研究。
节点的初始CPT是BN方法检测的一个重要问题,对于难以获取大量历史数据的研究对象,采用专家评分去获取初始节点概率值是一个较为中肯的办法。在获取专家知识时,考虑到专家知识的不确定性,采取模糊集方法可将语言表达与数学推理相结合来分析。
FBN方法的使用,目前主要有2种方法[4]。第1种是将模糊集方法用于获取先验概率,利用专家经验求模糊先验概率;第2种是使用隶属函数替代先验概率,计算模糊概率。第2种方法对于隶属函数的选取的依赖程度过高,在分析过程中会加大误差,因此,选取第1种方法。考虑到三角形隶属函数代数运算简单,采用三角隶属函数描述节点的模糊可能性,模糊分段函数μ(x)见下式:

式中(lmn)为其三角模糊数,且l<m<n
将风险因素发生的概率划分为轻度影响、一般影响、中度影响、较大影响、重度影响,模糊语言与相对应的三角模糊数见表2
由于专家经验水平、研究层次及背景都不完全相同,因此,不能直接采用算术平均的方式来计算根节点的先验概率,需要综合考虑专家意见对于模型参数确定的重要性及准确度,对不同类别的专家赋予相应的权重。假设每个专家Ej(j=1,2,…,k)的专家权重值为ejp'j为专家Ej的评分模糊值,专家评分平均模糊值p'可表示为:

通过上述计算得到平均模糊数后,进行解模糊运算,将其转化为准确的数值,即得到风险因素的风险概率。
按照各级风险源之间内在的因果关系,初步确定BN结构,如图3所示。
邀请60位专家,包括10位业内专家/教师(E1)、10位无人机行业运行人员(E2)、20位无人机飞手(E3)、20位无人机专业学生(E4),评价低空无人机BN根节点的风险先验概率。
依据BN结构及上述判断标度,判断赋值隶属于同一上层节点的诸节点,构建相关节点之间的判断矩阵。采用方根法对得到的判断矩阵进行量化计算,将判断矩阵A=(aij)n×n中每行元素分别相乘并开方得到求每个因素的权值Bi:

其中ij∈(1,n),将开方后的结果归一化处理,得到权值计算结果Ci:

建立专家权重判断矩阵见表3,对不同类型专家权重赋值。通过式(4)及式(5)计算得到专家权重ej
根据表2,将专家对根节点的风险概率评价结果与三角模糊数相对应,进行加权计算与模糊运算求解。将各根节点风险概率模糊评价的三角模糊数进行加权平均计算,最终得到的风险概率模糊数加权均值统计,见表4
根据评分结果,将各根节点的加权均值进行三角模糊数处理,对其进行归一化处理后,得到低空无人机风险的FBN各根节点的先验概率,见表5
对于FBN中非根节点的CPT,利用方根法并依据判断矩阵,进行非根节点的条件概率的计算及CPT的获取。计算得到低空无人机运行风险R的CPT,同理,获得R1R2R3R4的CPT表,进行后续的BN推理分析。其中,无人机运行风险R的CPT见表6
按照各级风险源之间内在因果关系,初步确定低空无人机风险评估BN结构图、BN节点变量值域、根节点先验概率参数、非根节点条件概率参数等,将各项参数利用GeNIe软件建立低空无人机风险评估FBN模型,并更新参数,采用GeNIe软件正向推理。
得到各节点的风险如图4所示,图中“YES”表示该节点因素出现风险导致下一节点因素影响的概率,“NO”表示该因素发生不产生影响的概率值。图中线段的粗细程度可以基本反应节点与节点之间的影响度。
图4可知:低空无人机运行过程中风险概率为47%,模型运行结果可为低空无人机行业风险评估及风险控制提供一定理论参考。
以国内某无人机运营单位无人机运行中失误为分析对象,假设某一因素在运行过程中导致无人机不安全事件发生,其风险值发生相应的变化,针对风险节点R1的推理分析如图5所示。
当飞行操作员失误X11发生时,人员因素R1的风险概率由初始的36%提升至57%,同理,推导出其他节点变化情况下其对应的影响节点的风险概率变化情况汇总见表7
从相对影响度结果可知:在人员因素方面,运行监管人员出现差错对无人机运行过程的风险影响度较大;在无人机因素方面,电池质量及运行情况很大程度上影响无人机运行安全;在环境因素方面,低空无人机运行障碍物对无人机运行安全影响较大;在运行管理方面,需要完善无人机运行风险监管文件以及运行手册、运行流程等,减少对无人机运行安全的影响。
此外,在实际运行中,单一因素导致无人机不安全事件发生时,采取相应的应急措施可以很大程度缓解无人机事故导致的后果。但多因素不安全事件发生时,易容易导致不可逆转的无人机坠地。以无人机因素R2这一风险节点分析为例,结果如图6所示。
当无人机硬件和软件同时发生故障时,R2的风险概率由原来的44%增加到71%。按照上述方法汇总不同节点影响的风险概率值变化情况,得到双节点风险概率变化,见表8
从风险概率变化可知:当无人机发生电池故障,并发无人机的软硬件故障时,无人机设备的风险概率受到较大的影响,风险值提高到80%,无人机失控坠地造成地面伤害的可能性增大。
利用GeNIe软件进行反向推理,即从果至因的推理分析,可较为直观地看出,当发生低空无人机运行风险时,哪些因素是较为显著的影响因素,通过识别关键影响因素,可以提出更有针对性的风险控制措施,FBN反向推理如图7所示。
从FBN反向推理结果可知:当低空无人机运行过程风险存在时,环境相关风险(79%)、无人机设备风险(60%)这2个节点指标的风险概率相对较高,说明上述因素发生变故时,低空无人机风险发生的可能性较大。此外,二级风险要素关注操作和监管人员因素、电池故障、运行环境障碍物对无人机运行的影响,也要加强无人机监管流程的完善。
利用GeNIe软件进行敏感性分析,即找出FBN结构模型中哪些节点因素发生变化时会对目标节点产生较大影响,从而在风险控制时重点关注这些节点因素。无人机运行FBN敏感性分析结果如图8所示,图中节点颜色深浅程度反映了节点的敏感程度。
结果可知:颜色较深的节点如人员失误、气象环境风险、飞行服务信息环境风险、环境障碍物风险、电池故障、无人机硬件故障为影响低空无人机运行的敏感性因素,这些风险因素的小幅度变化可能导致风险的发生,需要对这些敏感性风险因素采取相关控制措施,以提高运行安全能力。
R2节点的敏感性分析为例,得到其敏感性分析直观表示的龙卷风图,如图9所示。
图9显示了目标节点R2的选定状态敏感参数,从最敏感到最不敏感排序,可以看出,在模型中的精确位置(节点及其状态取决于父节点及其状态)。龙卷风图条形显示了参数在其范围内变化时目标状态的变化范围。龙卷风图条形中轴线的右侧表示正变化,左侧表示负变化。
从视觉角度来看,可将龙卷风图中每个敏感节点对应的条形的长度视为该节点对目标节点的影响量。节点X24对节点R2的影响最大,目标值范围显示,所选目标结果的最小和最大后验概率值为(0.535 823,0.580 397),参数范围显示参数的最小值和最大值为(0.513,0.627)。

2) 低空无人机运行的关键风险因素为无人机电池故障、运行航线的环境障碍物以及无人机运行监管技术;FBN反向推理分析结果显示,环境相关风险(79%)、无人机设备风险(60%)是无人机运行过程主要风险因素。
