Excessive damage to aircraft braking moving discs will directly threaten flight safety. In order to solve the problems of low detection efficiency and strong subjectivity in the evaluation of damage degree of braking moving disc based on manual experience,an intelligent evaluation algorithm for damage degree and replacement need of aircraft braking moving disc based on image segmentation was proposed. Firstly,the classification and feature information of braking moving disc damage were analyzed. Then,based on the U-Net model,semantic segmentation was performed on the braking moving disc damage image dataset. A quantitative analysis model for the proportion of braking moving disc damage area and a calculation model for the maximum radial width of the fall off area were constructed. Finally,the model was validated using image data of the braking moving disc of Cessna525. The results indicate that the U-Net model has a good image segmentation effect on the types of braking moving disc damage,with average accuracy,average recall,average pixel accuracy,and average intersection to union(IoU) of 90.75%,91.25%,90.25%,and 87.25%,respectively. The evaluation results of braking moving disc are basically consistent with the evaluation conclusions of experienced mechanical engineers,and the evaluation results are objective,accurate,and highly visualized,which proves the rationality and feasibility of the algorithm proposed in this paper.

飞机刹车盘动片损伤超标将直接威胁飞行安全。为解决人工经验的刹车盘动片损伤程度评估存在检测效率低、主观性强等问题,提出一种基于图像分割的飞机刹车盘动片损伤程度及更换需求智能评估算法。首先,分析刹车盘动片损伤分类及特征信息;然后,基于U-Net模型语义分割刹车盘动片损伤图像数据集,构建刹车盘动片损伤区域面积占比量化分析模型和脱落区域最大径向宽度计算模型;最后,使用Cessna525刹车盘动片图像数据验证模型。结果表明: U-Net模型对刹车盘动片损伤类型的图像分割效果良好,平均精确率、平均召回率、平均像素准确率与平均交并比(IoU)分别为90.75%、91.25%、90.25%与87.25%。刹车盘损伤程度评估结果与经验丰富的机务工程师评估结论基本一致,且评估结果客观准确、可视化程度高,证明所提算法的合理性和可行性。

飞机刹车盘动片损伤超标将直接威胁飞行安全。为解决人工经验的刹车盘动片损伤程度评估存在检测效率低、主观性强等问题,提出一种基于图像分割的飞机刹车盘动片损伤程度及更换需求智能评估算法。首先,分析刹车盘动片损伤分类及特征信息;然后,基于U-Net模型语义分割刹车盘动片损伤图像数据集,构建刹车盘动片损伤区域面积占比量化分析模型和脱落区域最大径向宽度计算模型;最后,使用Cessna525刹车盘动片图像数据验证模型。结果表明: U-Net模型对刹车盘动片损伤类型的图像分割效果良好,平均精确率、平均召回率、平均像素准确率与平均交并比(IoU)分别为90.75%、91.25%、90.25%与87.25%。刹车盘损伤程度评估结果与经验丰富的机务工程师评估结论基本一致,且评估结果客观准确、可视化程度高,证明所提算法的合理性和可行性。

Excessive damage to aircraft braking moving discs will directly threaten flight safety. In order to solve the problems of low detection efficiency and strong subjectivity in the evaluation of damage degree of braking moving disc based on manual experience,an intelligent evaluation algorithm for damage degree and replacement need of aircraft braking moving disc based on image segmentation was proposed. Firstly,the classification and feature information of braking moving disc damage were analyzed. Then,based on the U-Net model,semantic segmentation was performed on the braking moving disc damage image dataset. A quantitative analysis model for the proportion of braking moving disc damage area and a calculation model for the maximum radial width of the fall off area were constructed. Finally,the model was validated using image data of the braking moving disc of Cessna525. The results indicate that the U-Net model has a good image segmentation effect on the types of braking moving disc damage,with average accuracy,average recall,average pixel accuracy,and average intersection to union(IoU) of 90.75%,91.25%,90.25%,and 87.25%,respectively. The evaluation results of braking moving disc are basically consistent with the evaluation conclusions of experienced mechanical engineers,and the evaluation results are objective,accurate,and highly visualized,which proves the rationality and feasibility of the algorithm proposed in this paper.

飞机的刹车系统在起降过程中承受高温、高应力、高热冲击,致使刹车盘动片产生不同程度的裂纹、磨损、锈蚀等损伤,一旦损伤程度超出规定标准,将直接威胁飞行安全。因此,经过一定数量的起落后,就需要及时更换损伤超标的刹车盘动片。目前,受检测设备和技术的限制,机务工程师仍然以人工目视的方法来检测刹车盘动片上的裂纹、磨损和锈蚀等损伤情况,并根据经验来判定该刹车盘动片是否达到需要更换的标准。该检测方法存在以下3个问题: ①检测效率低、检测工作负荷大; ②检测标准的执行主观性强; ③检测结果可信程度需提升。如果未及时检测出应该更换的刹车盘动片则会影响训练飞行安全;若频繁更换不该淘汰的刹车盘动片,则也会造成资源的浪费和运行成本的提升。因此,亟需研究更加科学、便捷、智能化程度更高的刹车盘动片损伤程度及更换需求判别方法。
刹车盘动片损伤程度检测实质是计算机视觉中的图像分割问题,即对图像进行像素级的分类。传统的图像分割算法主要有支持向量机、反向传播神经网络、K-means聚类等,主要存在分割效果欠佳、效率较低、耗时较长等问题[1]。随着深度学习算法的兴起,基于卷积神经网络的图像语义分割成为更行之有效的方式,主要算法有全卷积神经网络(Fully Convolutional Networks,FCN)[2-3]、卷积编码器-解码器模型(包括Seg-Net、U-Net[4]和V-Net)、多尺度分析模型等。目前,民航飞机零部件表面损伤程度检测主要集中在机身蒙皮、发动机叶片等位置,检测技术有脉冲涡流传感器[5]、计算机视觉[6]、电磁层析成像[7]等。汽车刹车片[8-9]和高铁刹车系统[10-11]的损伤检测成果较为丰富,现有成果主要集中在刹车性能评估[12]、刹车盘寿命预测[13]等方面,鲜有研究飞机刹车盘动片损伤程度的检测。
鉴于此,笔者提出基于深度学习的飞机刹车盘动片损伤程度智能评估方法,分析飞机刹车盘动片损伤样本图像的特征信息,采用U-Net模型进行图像分割,构建刹车盘动片锈蚀面积计算模型和脱落区域最大径向宽度计算模型,评估现有刹车盘动片损伤程度及更换需求,以期为定量判定刹车盘动片损伤程度及更换需求提供参考依据。
刹车系统是飞机制动过程中的主要手段,通过安装在飞机机轮内的刹车组件产生刹车力矩,吸收飞机着陆滑跑的动能从而使得飞机减速,达到缩短滑跑距离的目的。飞机的刹车装置结构以多盘式为主,由刹车盘(动片和静片)、刹车壳体、汽缸座活塞组件等组成。其中,刹车盘动片的作用是将巨大的动能转换为热能并及时耗散出去,通常会选用重量更轻、性能更好、耐高温、寿命长的碳/碳复合材料来制造。当然,刹车盘动片作为一种易损耗器件,在使用过程中会出现锈蚀、脱落的损伤情况(图1),一旦损伤程度超出规定的标准将直接影响航空器的运行安全。
刹车盘动片表面损伤主要有锈蚀与脱落2类。其中,锈蚀(图1a)是因为刹车盘动片接触到水或处于潮湿环境中,表面发生氧化反应所导致的,其形状和分布随机性较强;脱落(图1b)是长时间使用所造成的碎裂和温度过高所导致的,该区域通常分布在动片内外径及热膨胀槽处。
飞机刹车盘动片损伤程度的评估标准主要有2个方面(图2): ①刹车盘动片单个侧面上锈蚀面积与磨损覆盖面积占比不超过单侧总面积的25%。 ②刹车盘动片单个侧面上内衬在内径、外径及热膨胀槽处有不超过6.4mm宽(从刹车内衬边缘向内)的局部碎裂脱落。
根据刹车盘动片损伤程度评估标准,提出相应的检测算法,步骤如图3所示。
首先,采集飞机刹车盘动片表面图像数据并进行预处理。根据动片损伤情况进行分类,标注出锈蚀、脱落、碟片、钢片区域,形成损伤图像数据集。在数据增强后传入图像分割算法中进行训练,得到刹车盘动片表面损伤图像分割模型。其次,将刹车盘图像输入到该模型中,得到与输入图像尺寸相同且包含表面损伤信息的推理结果图像。通过统计输出图像中各类别所含像素点数量,进一步得到锈蚀与脱落区域面积所占比例。然后,计算刹车盘动片圆环部分像素宽度与脱落区最大径向像素长度,通过两者比例关系,得到实际脱落区最大径向宽度。最后,综合锈蚀、脱落区面积比例计算结果与脱落区最大径向宽度计算结果,判定是否淘汰该刹车盘。
语义分割是对图像进行像素级的分类,即将每个像素都标注在对应的类别。文中构建基于U-Net的刹车盘图像分割模型,它是由一个编码器(下采样路径)和一个解码器(上采样路径)组成,中间是一个连接两者的“U”形结构。其中,编码器部分使用卷积层和池化层进行图像的多次下采样,逐渐减小图像的尺寸和通道数,从而提取图像特征。解码器部分通过上采样操作逐步恢复图像的分辨率,并生成图像分割结果。编码器与解码器之间的跳跃连接,可帮助解码器获取编码器中的细节信息,以改变图像分割的准确性。在网络的最后一层,使用1×1卷积融合不同分辨率的特征图,产生最终的分割结果,从而实现图像的像素级分类。
再分别遍历标注脱落、锈蚀的区域,统计各部分像素点总量,并计算标注脱落与锈蚀部分所有像素点与刹车盘动片全部像素点之和的比值r,即为刹车盘动片损伤区域面积。

构建刹车盘动片局部碎裂脱落区域最大径向宽度计算模型,流程如图4所示。首先,颜色过滤刹车盘动片图像分割结果,找出脱落区域以及刹车盘动片内外径轮廓,并使用贝塞尔曲线去逼近这些轮廓,找到脱落区域像素点到刹车盘动片内外径轮廓的最小距离方向;使用布雷森汉姆直线算法得到像素点到该方向的长度,计算出脱落区域的最大径向像素长度。然后,通过最小二乘法与高斯消元法拟合刹车盘内外径同心椭圆,得到刹车盘圆环部分像素长度。最后,两者相比即可得到刹车盘脱落区域的最大径向宽度。若大于6.4mm,则判定该刹车盘动片损伤超标需及时更换,反之则为不超标,可继续使用。
为验证基于U-Net模型的刹车盘动片损伤区域图像分割效果,选用精确率P、召回率R、像素准确率A、交并比(Intersection Over Union,IoU)等指标来评估。
1) P用来衡量模型正确预测为正例的比例,相对于模型预测为正例的总数量。

式中:TN为真阴性,表示模型正确地将负类样本分类为负;TP为真阳性,表示模型正确地将正类样本分类为正;FP为假阳性,表示模型错误地将负类样本分类为正;FN为假阴性,表示模型错误地将正类样本分类为负。
以我校高教机Cessna525的刹车盘动片为研究对象,收集刹车盘动片图像共330张,分别标注其锈蚀、脱落、碟片、钢片区域,形成动片损伤数据集。其中,蓝色区域为锈蚀,标注为“xiushi”;红色区域为脱落,标注为“tuoluo”;绿色区域为正常部分,标注为“diepian”;黄色区域为钢片部分,标注为“gangpian”。再对标注好的数据集进行马赛克数据增强以及混合数据增强以扩充样本数量和提升模型的泛化能力,并将样本数据按7:2:1划分为训练集、验证集和测试集。
图像分割采用的是U-Net算法,并在开源框架Pytorch上实现,试验所用电脑配置如下:操作系统为64位Windows11,处理器是Intel Core i7 12700 H,运行内存16G,独立显卡NVIDIA GeForce RTX3070,显存8G。在模型训练过程中,前100次冻结模型的主干网络,设置batch_size为8,初始学习率为0.001。解冻训练阶段设置batch_size为4,学习率调整为0.0001,当训练到loss值不降反升时结束训练,得到模型的最终权重。最终得到刹车盘动片图像分割PR、像素A和IoU,见表1
表1可知:U-Net模型能够实现对刹车盘动片各损伤类型的准确分割,在自制数据集上的各评价指标均表现较好。其中,钢片和碟片的各评价指标均在92%以上,脱落和锈蚀的评价指标稍低,但均在80%以上。总体而言,基于U-Net模型的刹车盘动片损伤图像分割的平均P、平均R、平均像素A与平均IoU分别为90.75%、91.25%、90.25%与87.25%,表明该模型对刹车盘动片损伤类型的图像分割效果良好。
基于损伤区面积量化模型与脱落区最大径向宽度计算模型,进一步处理基于U-Net图像分割后的刹车盘动片损伤图像,分别计算其损伤面积占比与脱落区最大径向宽度。3种典型样本的损伤程度评估结果如图5所示。
图5可知:损伤区面积量化模型与脱落区最大径向宽度计算模型能够实现对刹车盘表面损伤面积与脱落区最大径向宽度的自动识别与测量。其中,蓝色的线段表示的是刹车盘动片脱落区最大径向宽度所在位置,图像左上角打印的信息分别是刹车盘动片损伤面积比例(含脱落比例、锈蚀比例以及两者比例之和)与脱落区实际最大径向宽度。图5b显示样本1的损伤区域面积占比28.05%,均为脱落,已超出规定标准(25%);图5c显示,脱落区最大径向宽度为10.60mm,同样也超过了规定的标准(6.4mm)。因此,样本1已经严重威胁运行安全,应及时淘汰。图5e显示样本2的损伤区域面积占比21.05%,其中,脱落面积占比20.81%,锈蚀面积占比0.23%,总面积并未超出规定标准;图5f显示脱落区最大径向宽度为9.68mm,超过了规定的标准。因此,样本2也会威胁运行安全,应及时淘汰。图5h显示样本3的损伤区域面积占比12.97%,均为脱落,总面积并未超出规定标准;图5i显示脱落区最大径向宽度为4.45mm,也未超出规定的标准。因此,样本3还可继续使用,以节约训练飞行的运行成本。以上检测结果与经验丰富的机务工程师评估结论基本一致,且更加客观、可视化程度更高,证明所提算法是可行的。同时,该方法得出的评估结果所需时间较短(不超过1s),改变了传统依靠目视、耗时耗力的经验判断模式,实现了飞机刹车盘动片损伤程度的可量化、科学快速地评估。
1) 采用飞机刹车盘动片损伤程度智能评估方法评估Cessna525刹车盘损伤程度,评估过程耗时短,且评估结果客观准确、可视化程度高。该算法可为机务工程师科学、定量地判定刹车盘动片损伤程度及更换需求提供参考依据。
2) 基于U-Net模型可实现对刹车盘动片损伤区域的图像分割,构建的损伤区域面积量化模型和脱落区域最大径向宽度计算模型,能够实现对刹车盘动片损伤程度及更换需求评估从“经验判定”到“数智判定”的转变,避免人为因素引起的评估误差。
3) 后续将基于所提算法开发飞机刹车盘动片损伤程度智能评估原型系统,实现对其损伤程度及更换需求的自动、高效、精准评估。
