To resolve the difficulty of identifying representative data and the poor fatigue-damage consistency in low-sampling-rate online data when constructing electric vehicle load spectra on big data platforms, the paper proposes a method with strong user association for compiling the load spectrum of an electric vehicle drive system. First, on the big data platform, user characteristics are described from five dimensions: road type, driving style, load capacity, vehicle speed, and torque. Based on these user profiles, the paper proposes a global-optimal-pairing filter that selects a representative online user dataset, and applies a constraint-based fragment stitching method to join the data segments in order, establishing a multi-feature association between the load spectra and users. To improve damage consistency in low sampling rate online data, high-sampling-rate offline data collected from real vehicles are incorporated to enhance damage equivalence between the load spectra and users. The feature matching results show that the filtered data set deviates from the target user by only about 0.05 for each feature parameter, with no deviation exceeding 0.15. Fatigue-damage calculations confirm that the fusion of low-rate online data with high-rate offline data effectively enhances the damage equivalence between the load spectrum and the users.

针对目前基于大数据平台构建电动汽车载荷谱时典型数据难以确定、线上低采样率数据与实际载荷损伤一致性较差的问题,提出一种强用户关联的电动汽车驱动系统载荷谱编制方法。基于大数据平台,从道路类型、驾驶风格、载重、车速、转矩5个维度进行用户画像,根据用户画像结果,提出一种基于全局最优配对的线上数据筛选方法,从平台获取用户典型数据集,同时提出一种基于约束的片段拼接方法对数据集进行有序拼接,实现载荷谱与用户的多特征关联。针对线上低采样率数据与实际载荷损伤一致性差的问题,结合实车采集数据,通过融合线下高采样率数据增强载荷谱与用户的损伤等效。由特征值匹配度结果可知,采用该数据筛选方法获得数据集与用户在各特征参数下的偏差率均在0.05左右,且最大不超过0.15;载荷谱损伤计算结果表明,线上低采样率和线下高采样率数据相融合的方法可有效增强载荷谱与用户的损伤等效。

针对目前基于大数据平台构建电动汽车载荷谱时典型数据难以确定、线上低采样率数据与实际载荷损伤一致性较差的问题,提出一种强用户关联的电动汽车驱动系统载荷谱编制方法。基于大数据平台,从道路类型、驾驶风格、载重、车速、转矩5个维度进行用户画像,根据用户画像结果,提出一种基于全局最优配对的线上数据筛选方法,从平台获取用户典型数据集,同时提出一种基于约束的片段拼接方法对数据集进行有序拼接,实现载荷谱与用户的多特征关联。针对线上低采样率数据与实际载荷损伤一致性差的问题,结合实车采集数据,通过融合线下高采样率数据增强载荷谱与用户的损伤等效。由特征值匹配度结果可知,采用该数据筛选方法获得数据集与用户在各特征参数下的偏差率均在0.05左右,且最大不超过0.15;载荷谱损伤计算结果表明,线上低采样率和线下高采样率数据相融合的方法可有效增强载荷谱与用户的损伤等效。

To resolve the difficulty of identifying representative data and the poor fatigue-damage consistency in low-sampling-rate online data when constructing electric vehicle load spectra on big data platforms, the paper proposes a method with strong user association for compiling the load spectrum of an electric vehicle drive system. First, on the big data platform, user characteristics are described from five dimensions: road type, driving style, load capacity, vehicle speed, and torque. Based on these user profiles, the paper proposes a global-optimal-pairing filter that selects a representative online user dataset, and applies a constraint-based fragment stitching method to join the data segments in order, establishing a multi-feature association between the load spectra and users. To improve damage consistency in low sampling rate online data, high-sampling-rate offline data collected from real vehicles are incorporated to enhance damage equivalence between the load spectra and users. The feature matching results show that the filtered data set deviates from the target user by only about 0.05 for each feature parameter, with no deviation exceeding 0.15. Fatigue-damage calculations confirm that the fusion of low-rate online data with high-rate offline data effectively enhances the damage equivalence between the load spectrum and the users.

与传统车辆相比,电动汽车电机转矩的提高在带来功率增加的同时也加剧了驱动系统故障的风险[1],因此在电动汽车的研发和生产过程中,驱动系统的可靠性试验是一个关键环节[2]。然而,由于道路、区域和驾驶特性等复杂场景的影响,目前电驱动系统的可靠性试验存在难以有效覆盖用户载荷损伤强度的问题[3]
长期以来,国内外相关技术人员围绕关联用户的动力传动系统可靠性试验开展了大量的研究工作[4-6]。李文礼等[4]基于实车采集数据获得了包含转速和挡位信息的传动系时域外推载荷谱,实现了用户实车行驶数据与台架试验的结合。门玉琢等[5]基于累积失效概率为90%的用户总累积损伤实现了传动系总成台架试验与用户使用寿命的统一。李旭东等[6]提出了一种基于多维度的车辆行驶工况划分方法,并基于此开展了用户关联的车辆耐久性载荷谱编制。目前,由于车辆运行状态受地形地势、路面状况、交通状态、驾驶行为等多重因素影响[7],单一样本的实车道路测试数据很难反映用户的群体特征,据此构建的载荷谱也存在与用户关联程度低、关联维度少的问题。而随着智能网联技术及大数据技术的发展,上传云端的汽车参数数据越来越丰富,使根据大数据定义用户使用特征和构建载荷谱成为可能,而如何从用户大数据中精确地挑选出符合用户使用特征的数据集是其中的关键问题。
针对以上问题,本文以用户运行大数据和实车测试数据为基础,提出一种强用户关联的电动汽车驱动系统载荷谱编制方法。一方面,基于大数据平台进行多维度用户画像,全面描述用户使用特征,同时,提出一种基于全局最优配对数据筛选方法从大数据平台获取用户典型数据集,以实现载荷谱与用户的特征关联;另一方面,考虑到平台低采样率数据与实际载荷损伤一致性差的问题,采集线下高采样率数据以增加载荷谱的损伤等效;最终构建一种线上低采样率和线下高低采样率数据相融合的载荷谱,为开展与用户使用特征相关联的电动汽车传动系统载荷谱编制提供了参考和依据。
电动汽车载荷谱数据来源包括实车道路测试和线上大数据平台。由于采样时间和成本的限制,实车道路测试用户样本量通常较少;而大数据平台通过采集车辆运行过程中的各类数据,整合来自多个车辆和地区的数据,提供了更全面的视角和样本。
为了研究用户样本量对载荷谱损伤的影响,本文以用户量n为自变量,对比分析了用户量与载荷损伤的对应关系。随机选择大数据平台的n个用户,从中提取一定长度(1万km)的载荷数据并计算其损伤,重复10次后得到用户量n下的10个损伤值,之后计算其均值与方差。改变用户量n的取值,最终得到用户量与损伤的关系曲线如图1所示。
图1可知,随着用户量增加,载荷损伤均值趋于稳定,损伤方差整体呈下降趋势。以上表明:当用户样本量较多时,根据样本数据构造的载荷谱随机损伤误差较小,更具代表性;同理可知,样本量丰富的大数据平台载荷数据更具代表性,据此编制的载荷谱更能代表用户的整体损伤特征。
然而,由于线上载荷数据通常为低采样率数据,难以捕捉高频率的载荷变化,所以在其采集过程中很可能出现重要尖峰载荷数据的丢失或失真。而为了探究采样率对载荷数据损伤结果的影响,本文通过重采样对比研究了同一载荷历程在不同采样率下载荷循环计数和疲劳损伤的差异,具体内容如下。
步骤1:选取一组时长1.5 h,采样频率1 000 Hz的传动轴转矩序列作为用于对比的原始数据。
步骤2:为了模拟不同采样率下的数据采集,采用数据抽取的方式对原始数据进行多次重采样,以获得一系列不同采样频率的载荷数据。如将1 000 Hz数据重采样至100 Hz,即在数据中每10个点抽取1个点组成新的数据序列。
步骤3:基于Tecware软件采用雨流计数法对各采样率数据进行载荷循环计数,部分雨流矩阵图如图2所示。统计总循环频次和载荷疲劳损伤,获得各采样率数据损伤情况与原始数据的误差对比,见表1
图2表1可知,随着采样率降低,载荷数据总循环频次和损伤逐渐减小,与原始数据的误差逐渐增大;特别是当采样率小于100 Hz时,总循环频次和损伤的误差率较大,且其数值随采样率降低呈指数级增长。综上可知,采样率对载荷数据采集后计算得出的损伤结果影响较大,大数据平台的低采样率数据与实际载荷情况损伤一致性较差,据此构建的载荷谱存在损伤不完全等效的问题。
由1.1节可知,大数据平台载荷数据更能代表用户整体使用特征;本文以大数据平台为基础,从道路类型、驾驶风格、载重、车速、转矩5个维度进行用户画像,提出了一种基于全局最优配对的数据筛选方法获取线上用户典型数据集;同时,考虑到由1.2节得知的平台低采样率数据与实际载荷损伤一致性差的问题,采集实车高采样率数据以增强载荷谱与用户的损伤等效;最终构建一种线上低采样率和线下高低采样率数据相融合的载荷谱数据采集方案,其流程如图3所示。
通过在车联网云平台布置车辆运行特征统计模型,本文从道路类型、驾驶风格、载重、车速、转矩5个维度进行用户画像,采用按月计算特征值以及特征值按月迭代,多用户迭代的方法统计获得用户整体使用特征。
车辆的载重状态分为满载和半载2种,由于用户使用模型对车辆质量计算的精度要求不高[8],本文通过采用座椅传感器感知车辆乘坐人数的方式对车辆满半载状态进行评估。
设车辆最大乘坐人数为M,根据座椅传感器信号得知的车辆乘坐人数为m,则车辆满半载状态的判定规则见表2。按照规则确定用户月数据满半载状态,分类统计满半载数据后,用户月数据满半载里程占比如式(1)所示。

式中:i为满半载状态序号;vj为满载/半载数据对应车速;hi为用户月数据中满载/半载数据总数; Δ t为采样时间;l为用户月里程。
为了对车辆行驶速度进行状态划分,针对某款车型统计用户数据的车速里程占比和累计里程占比,如图4所示。根据车速累计里程占比曲线,按照比例4 4 2,最终制定车速状态判定规则,见表3。按照表3分类统计用户月数据后,月数据车速里程占比计算式如式(1)所示。此时,式中i为车速状态序号;vj为各车速状态下的车速数据;hi为用户月数据中各车速状态下的数据总数。
与行驶速度分布类似,设电机转矩的绝对值为|T|,统计某款车型用户驱动电机转矩数据的电机转矩绝对值的里程占比和累计里程占比如图5所示。根据累计里程占比曲线,按照比例4 4 2,划分电机转矩状态为小转矩、中转矩、大转矩3种,其判定规则见表4。根据判定规则确定用户月数据转矩状态后,月数据电机转矩里程占比计算式如式(1)所示。此时,式中i为车速状态序号;vj为各转矩状态下对应的车速数据;hi为用户月数据中各转矩状态数据总数。
不同驾驶风格会导致车辆运行参数的差异,为了界定用户在行驶过程中的驾驶风格,本文根据车辆行驶速度、加速度等数据采用聚类算法对用户行驶短行程进行驾驶风格分类[9],具体内容如下。
随机选取多名用户数据,剔除长时间怠速及异常数据后,提取运行段作为驾驶风格聚类的基础数据库。其中,运行段为车速从0开始到下一个车速为 0且平均车速大于5 km/h的片段。
由于驾驶风格的差异主要表现在车辆速度的变化特征,所以以汽车加速度为基础数据,选取作为驾驶风格聚类的特征参数见表5
假设一个运动段由N个加速度点组成,采样时间为 Δ t,则各特征参数计算方法如式(2)~(6)所示。

计算运行段特征参数后,所有运行段的4个特征参数组成驾驶风格聚类的特征参数矩阵。
通过K-Means聚类算法对特征参数矩阵进行聚类运算,聚类中心结果见表6,根据运算结果可将运动段划分成激进型、一般型和保守型3类驾驶风格。
提取用户月运行数据的运行段并计算其特征参数,计算各运行段特征参数与3个聚类中心的欧氏距离后,以距离最近为原则确定运动段的驾驶风格。统计各驾驶风格里程的用户月数据驾驶风格里程占比。
城市道路可分为市区道路、高速道路、郊区道路和山区道路,由于车联网云平台数据未包含道路类型信息,本文基于(OpenStreetMap,OSM)开源矢量空间数据集,利用ArcGIS软件构建典型城市道路类型GPS范围库,根据用户GPS数据确定其行驶道路类型。
以典型城市北京市为例,道路类型GPS范围库划分方法如图6所示,具体划分步骤如下。
步骤1:在ArcMap软件中导入全国省级、县级行政区划以及全国道路SHP数据,通过矢量数据相交、裁剪等编辑方法保留北京市行政区划及全市道路矢量数据几何要素。
步骤2:提取城市边界及绕城高速路线并补全为完整几何,输出城市边界及市区边界线,如图7a所示。
步骤3:依据OSM数据道路类型分离城市高速道路,沿道路线间隔100 m构造测量点并计算其经纬度,输出北京市高速道路GPS数据库,如图7b所示。
步骤4:由于缺乏山地的明确定义及量化标准,本文通过计算目标范围内地形起伏度界定山区范围。具体内容为:导入下载自地理空间数据云的高分辨率(Digital Elevation Model,DEM)栅格数据,依据北京市所在经纬度载入SRTM3-90 m全国DEM信息栅格块,运用高程栅格镶嵌合并工具的北京市及附近地形数据;利用焦点统计、邻域分析及地图代数工具计算栅格区块地形起伏度,基于地形起伏度采用自然间断点分级法将地形数据重分为平原和山区,运用矢量处理方法将山区栅格数据转换为矢量数据,从而获得山区范围边界,如图7d所示。
步骤5:郊区区域为北京市除市区、山区及高速公路外的剩余部分,区域边界线如图7c所示。
步骤6:最终按照100 m间隔沿各区域边界线构造测量点,利用计算几何工具获取测量点经纬度字段的北京市道路分类GPS范围库,结果如图7所示。
利用短行程法划分用户月数据短行程片段,其中短行程指相邻2个速度零点之间的汽车车速循环增减片段。基于道路分类GPS范围库和用户数据经纬度信息,以点在区域内及点在线上的位置比例判断用户短行程行驶道路类型。统计各道路类型行驶里程,获得用户月数据道路类型里程占比。
由上述特征值月统计方法可得车联网云平台各用户月特征值,结合用户月行驶里程,按照里程比例累加即为用户总体特征值。同时,当车联网云平台上传新用户数据时,计算新数据的月特征值和月行驶里程后,根据式(7)可对用户总体特征值进行更新计算。此式在历史计算结果的基础上进行处理,具有计算效率高的优点,可实现特征值按月、多用户的实时更新迭代。

式中:knewkold分别为更新前后的特征值;lold为更新前特征值对应的里程数; a为新数据用户数量; b i为新用户i的月份数;tijlij为新用户ij个月份的特征值和行驶里程。
用户使用模型描述了目标市场中用户的车辆使用特征,可以从车辆行驶区域、道路类型/地形地势、有效载荷及驾驶习惯4个维度来识别[10]。本文针对某细分市场的一款车型,从道路类型、驾驶风格、载重、车速、转矩5个方面考虑,通过在车联网云平台上布置车辆运行特征统计和迭代模型,全面描述用户实际使用特征,获得用户使用模型结果,见表7
利用车联网云平台海量用户数据构建用户典型载荷谱为电动汽车可靠性测试提供了便利,而如何从云平台提取一定量符合用户使用特征的载荷数据是构建典型载荷谱的关键问题。基于此,本文提出了一种基于全局最优配对的线上数据筛选方法,根据用户画像结果从平台获取用户典型数据集,同时,提出一种带约束的数据拼接方法对数据集进行有序拼接。
为了保证数据在地域城市、道路条件、气候环境、驾驶工况、驾驶人特征等方面的代表性和覆盖度,选择北京、重庆、成都、西安作为典型城市,在车联网云平台上提取海量用户运行数据,包括时间、车速、GPS、座椅传感器信号、驱动电机转速和转矩等信息。
数据预处理包括基于达拉依准则和线性内插值法的异常离群值点处理以及长时间怠速数据剔除,部分用户数据预处理情况如图8所示。此外,由于信号采样频率各不相同,对数据进行重采样以满足数据片段特征参数的统计需求。
采用等里程划分法划分数据,即将预处理后数据以10 km为标准划分为等里程片段,其目的是保证数据片段里程值统一,以便后续数据配对时特征参数叠加。
数据片段特征参数与用户使用模型相对应,包括道路类型(市区、高速、郊区、山区)里程比例、驾驶风格(激进型、一般型、保守型)里程比例、满半载(满载、半载)里程比例、行驶速度(低速、中速、高速)里程比例以及电机转矩(小转矩、中转矩、大转矩)里程比例,其计算方法与特征值的月统计方法相同。特征参数计算完成后,所有等里程数据的特征值构成了数据筛选的初始数据库。
基于全局范围内数据点相互组合后可向目标点靠拢的效果,本文提出了一种基于全局最优配对迭代的数据筛选方法。该方法以数据配对后特征值与目标点距离最小为原则,在全局范围内依次进行数据寻优配对,通过多次配对迭代获取典型数据集,可实现全局范围内的数据利用。
假设初始数据库有m个数据Xi=(xi1xi2xi15),i=1,2,…,m,基于全局最优配对的数据筛选方法具体内容如下。
步骤1:遍历计算初始数据库中Xi与其余数据Xj配对后与目标点G=(0.268,0.397,0.138,0.179,0.164,0.427,0.409,0.376,0.624,0.393,0.453,0.154,0.376,0.444,0.180)的欧氏距离Lij,记录Li,min及其对应的Xj

步骤4:重复步骤2和步骤3,依次获得配对结果,直至数据库配对完成。
步骤5:依次累计配对后数据,计算累计数据均值与目标点的偏差率PEk及平均偏差率MPE。

步骤6:以配对后数据作为新的初始数据库,以累计数据里程达到目标里程时MPE≤0.05且max(PEk)≤0.15为终止条件,重复步骤1至步骤5进行数据匹配迭代。
以12万km为目标里程,根据该筛选方法获得的典型用户数据集与用户使用模型的特征参数对比如图9所示,由图可知,典型用户数据集特征参数与用户使用模型基本一致,各特征参数的偏差率均在5%左右且最大不超过15%,可认为筛选数据集符合用户使用特征,即该筛选方法能在获取足够数据量的同时实现了良好的特征值匹配。
由于数据片段首尾数值的随机性,采用TecWare直接拼接数据集片段很可能出现载荷异常变化而引入大幅值载荷循环,从而影响载荷数据的疲劳损伤,如图10所示。针对以上情况,本文提出了一种带约束的数据片段拼接方法,通过设置约束条件对筛选数据集进行有序合理拼接。
对于参与拼接的2个片段,假设前1个片段尾部的数值和斜率为T1v1,后1个片段首部的数值和斜率为T2v2,则拼接约束条件包括:
a. |T1T2|≤10 Nm;b. v1·v2≥0。
基于约束的数据拼接方法具体内容如下。
步骤1:对于筛选数据集中任一片段Ai,根据拼接约束条件遍历其余片段,其中可拼接其前的片段组成集合setf,i,可拼接其后的片段组成集合setr,i
步骤2:选择setf,i包含片段最少的Ai作为拼接的第1个片段,存在多个时,取其中setr包含片段最多的一个。
步骤3:在第1个片段的setr,i中,选取其setr包含片段最多的片段作为拼接的第2个片段,以此类推。
步骤4:当拼接至第n个片段中断时,若n为筛选数据集片段总数,则拼接完成;否则,适当放宽拼接在第n个片段后片段的数值限制或斜率限制,直至拼接完成。
选取1段里程为180 km的驱动电机转矩数据,按照等里程(1 km)划分片段并打乱顺序后,分别采用TecWare和该数据拼接法对片段进行拼接。对比雨流计数后2种拼接数据与原始数据的雨流矩阵,由图11可知,相比于在TecWare直接拼接数据,采用本文拼接方法得到的数据雨流矩阵与原始数据更接近,特别是图中红框内的高幅值区域,因此,该数据拼接方法在一定程度上改善了数据拼接过程额外引入大幅值载荷循环的问题。
采用该数据拼接方法对筛选数据集进行有序拼接,雨流计数后得到的线上用户数据载荷谱如图12所示。
由于线上低采样率数据与实际载荷存在损伤一致性较差的问题,本文基于用户画像结果,以道路类型、载重划分实车采集工况,额外进行线下实车数据采集,各工况数据里程占比见表8
由于电机输出轴无测试仪器布置空间,本文在驱动轮左右半轴布置转矩遥测仪,通过将测得的左右半轴转矩相加后除以传动比得电机输出轴转矩。转矩遥测仪如图13所示,其工作原理为:发射机将应变片采集的电压信号隔空传递给接收机,而接收机将电压信号转换为转矩数据。设置采样频率为1 000 Hz,对各工况进行实车数据采集后,以满载为例,各道路类型代表性转矩数据如图14所示。
采用雨流计数法对各工况实车采集数据进行载荷循环计数得from-to型雨流矩阵,基于核密度估计对雨流矩阵进行分布拟合得载荷循环的分布概率密度函数。其中,核密度估计是一种不依赖任何先验假设的非参数估计方法,选取高斯核作为核函数,则二维核密度估计表达式为:

式中:n为载荷循环总数;xiyi为第i个载荷循环的from、to值;h为核密度估计的带宽,采用拇指法则进行最优带宽计算[11],其计算式为:

式中:d为核密度估计的维数,取2;σ为二维数据样本的标准差。
以市区半载数据为例,其雨流计数结果如图15所示,载荷循环概率密度函数估计结果如图16所示。
基于各工况载荷循环分布概率密度函数和设计里程占比,外推并叠加各工况载荷数据的目标里程下多工况复合载荷谱,其计算式为:

式中: f ^ t o t a l ( x , y )为多工况复合载荷循环分布函数;ltotal为目标总里程,数值为12万km;lirini f ^ i ( x , y )分别为第i种工况试验数据的总里程、里程占比、载荷循环总次数和载荷循环概率密度函数。
最终的线下实车数据载荷谱如图17所示。
叠加线上用户数据和线下实车载荷谱得某款车型24万km全寿命周期载荷谱(图18)。采用Goodman方程[12]对二维载荷谱进行平均应力修正得线上、线下载荷谱数据的对数累计频次曲线如图19所示,同时,各载荷谱损伤计算结果见表9
对比载荷谱雨流矩阵以及图19表9可知,相比于实车数据载荷谱,线上用户数据载荷谱的数值范围更大,这是由于线上数据具有更全面的用户样本,能全面捕捉用户载荷情况;同时,在相同里程下,线上用户数据的载荷损伤和各载荷幅值频次均低于实车测试数据,印证了线上低频数据在载荷循环计数和疲劳损伤方面一致性较差的问题。由单位里程损伤可知,采样线上低采样率和线下高采样率数据相融合的方法增强了全寿命周期载荷谱的损伤等效。
为了得到与实际用户相关联的电动汽车可靠性评价,本文基于线上用户运行大数据和实测载荷数据,开展了电动汽车传动系统载荷谱编制方法研究,主要结论如下。
1)进行样本量和采样率对载荷损伤的影响研究,针对实车测试数据代表性差和线上低频数据与实际载荷损伤一致性差的问题,形成了一种线上线下数据相融合的载荷谱编制方法。
2)基于道路类型GPS范围库与经纬度信息确定道路类型,采用K-Means聚类算法划分驾驶风格,利用座椅传感器信号评估满半载状态,从道路类型、驾驶风格、载重、车速、转矩5个维度对用户使用情况进行画像。
3)提出了一种基于全局最优配对的线上数据筛选方法,根据用户画像结果,采用全局寻优配对迭代的方式筛选用户典型数据集,提出一种基于约束的片段拼接方法对筛选数据进行有序拼接,由特征值匹配度结果可知,筛选获得的线上数据符合用户使用特征。
