In the identification of operational behavior of earth pressure cells and structural safety assessment, measurement gross errors often coexist with abrupt changes reflecting actual structural responses, thereby compromising the accuracy of safety evaluation. To address this issue, this paper proposes an anomaly detection method for earth pressure cell measurements based on frequency domain decomposition and multi-point joint analysis. Through decomposition and reconstruction in the frequency domain, frequency components representing long-term trends and short-term fluctuations are derived. Subsequently, by integrating correlation analysis and the Isolation Forest algorithm, joint anomaly detection and diagnosis across multiple measurement points are achieved. Case studies based on actual engineering monitoring data demonstrate that the proposed method can accurately distinguish between gross errors and abrupt changes caused by structural anomalies or environmental factors, with high detection accuracy. The method enhances the diagnostic capability of earth pressure cell measurements and improves structural safety monitoring.

在对土压力计工作性态识别及结构安全评价中,数据粗差与结构真实响应的数据突变经常同时存在,影响安全评估结论的准确性。针对此问题,本文提出一种基于频域分解和多测点联合的土压力计测值异常检验方法,通过频域分解及重构,形成了反映长期趋势及短期扰动的频率成分,进而结合相关性分析与孤立森林算法,实现了多测点联合异常检验及诊断。工程实例验证表明,该方法可准确区分数据粗差与结构异常或环境因素导致的数据突变,检验准确率高,能够改善土压力计测值诊断水平,提升安全监控能力。

在对土压力计工作性态识别及结构安全评价中,数据粗差与结构真实响应的数据突变经常同时存在,影响安全评估结论的准确性。针对此问题,本文提出一种基于频域分解和多测点联合的土压力计测值异常检验方法,通过频域分解及重构,形成了反映长期趋势及短期扰动的频率成分,进而结合相关性分析与孤立森林算法,实现了多测点联合异常检验及诊断。工程实例验证表明,该方法可准确区分数据粗差与结构异常或环境因素导致的数据突变,检验准确率高,能够改善土压力计测值诊断水平,提升安全监控能力。

In the identification of operational behavior of earth pressure cells and structural safety assessment, measurement gross errors often coexist with abrupt changes reflecting actual structural responses, thereby compromising the accuracy of safety evaluation. To address this issue, this paper proposes an anomaly detection method for earth pressure cell measurements based on frequency domain decomposition and multi-point joint analysis. Through decomposition and reconstruction in the frequency domain, frequency components representing long-term trends and short-term fluctuations are derived. Subsequently, by integrating correlation analysis and the Isolation Forest algorithm, joint anomaly detection and diagnosis across multiple measurement points are achieved. Case studies based on actual engineering monitoring data demonstrate that the proposed method can accurately distinguish between gross errors and abrupt changes caused by structural anomalies or environmental factors, with high detection accuracy. The method enhances the diagnostic capability of earth pressure cell measurements and improves structural safety monitoring.

随着数字孪生水利工程建设工作的不断开展,对于工程安全监测成果分析及诊断精确性要求也不断提升1。土压力计是工程结构安全监测的主要仪器之一,其测值可直接反映结构与周围岩土体的相互作用,对工程结构的安全评价具有重要作用。土压力计连续监测数据中既包含结构在常规服役状态下的响应,也记录了特殊运行工况下的异常特征。土压力计测值产生波动的因素较多,既包含由于仪器稳定性、安装工艺等各类因素导致的粗差,还包括如施工加载效应、初次通水、短时强降雨、回填土密实度等因素带来的结构响应突变2(如图1所示)。实际测值中,数据粗差与真实异常都表现为数据波动,经常同时存在并出现混掺情况3,给精确识别与区分带来困难。近年来,国内监测界在识别数据波动方面取得了较大的进展4-7,尤其基于机器学习的孤立森林算法8、基于密度聚类的算法9、局部离群因子算法10等,但由于数据粗差与真实异常混掺,难以进行有效区分,粗差误判的现象始终无法避免。黎祎等11通过Apriori算法解析了大坝位移与环境量的关联性,进而将异常点区分为粗差点与反应大坝性态点两类。陈立秋等12针对混凝土坝变形监测数据,采用K-means++距离聚类算法进行测点分区,从而判定真实粗差与数据跳跃。然而,现有方法仍存在局限性,研究主要针对于整体性良好的混凝土坝位移监测,其适用范围有限,对于土压力计这类可靠性相对较低的监测仪器,相关研究仍然较少。准确地将不同土压力计异常测值类型进行自动化识别,对于结构异常分析及精准预警至关重要。
本文提出一种基于频域分解并融合多测点相关关系的综合处理方法(Fast Fourier Transform-Correlation Analysis-isolation Forest,简称FCA-iForest),以兼顾土压力计测值可靠性分析与粗差识别的双重需求,为工程结构安全评估提供有效支持。
本研究提出的FCA-iForest算法核心在于时频域联合分析与空间多测点交叉验证,通过将时序数据在频域上进行解构,分离出具备物理意义的不同成分,并针对其特点,采用对应的异常识别方法,再根据多测点关系建立判别准则,并最终实现异常序列的识别与异常类型的区分。
FCA-iForest算法利用快速傅里叶变换(Fast Fourier Transform,FFT)将时序数据转换至频域,根据土压力计测值在不同频段的特征进行分段,随后将不同频段的信号通过快速傅里叶逆变换(Inverse Fast Fourier Transform,IFFT)进行重构,得到原始数据的低频成分与高频成分。其中,低频成分采用相关性分析(Correlation Analysis),高频成分采用孤立森林算法(Isolation Forest)进行检验。由于低频成分与高频成分特征不同,建立不同的多测点判别准则。基于判别准则,对低频成分与高频成分的检验结果进行判别,以识别出测值可靠性较差的土压力计,并区分数据粗差与真实异常,方法的完整流程如图2所示。
在实际的安全监测过程中,根据工程特性与监测规范要求,监测数据定时上传,以离散信号的形式进行存储。快速傅里叶变换是一种常用的离散信号时频转换方法13,且计算复杂度低。对于一个离散信号:

以某土压力计数据为例,其时频曲线如图3所示。
其中,在图3(b)所示的频域图中,横轴表示对数坐标下的周期,转换公式如式(2)所示,纵轴反映了测值数据中各周期成分的强度分布。

土压力的变化受温度、降雨等多种因素的综合影响,且各因素间存在复杂的耦合关系。传统的影响因子分解方法难以有效量化此类相互作用,对复杂数据序列的解释能力有限。相比之下,基于频域分解的方法可通过典型周期区间对信号进行分解,从而避免构建复杂的耦合模型,如胡晖等14采用变分模态分解(VMD)和集总经验模态分解(EEMD)对流域原始径流序列进行分解,再对各个子序列分别进行建模,在三河口水库的月入库径流序列预测中取得了良好效果。在土压力分析中同样可以对原始测值序列进行分解,同时保留关键环境特征的周期性信息,典型周期区间被称为特征周期。例如,土体的固结、蠕变等过程会引起应力的重分布,该过程通常会持续数月至数年甚至更长时间不等;环境量如温度与降雨量的变化主要体现在年周期;其他的如闸门开度调整等调度运行操作会引起内外压差变化,从而导致土压力计测值短期波动。因此,将频域依据多年、年、半年、月、周对应的频率作为频段中心进行分解,各频段分别简称F1、F2、F3、F4、F5。根据数据序列长度,将其中F1、F2定义为较长周期频段,即低频成分;F3、F4、F5定义为较短周期频段,即高频成分。分解后各频段通过IFFT转化回时域,即得到基于频域分解的土压力计特征周期曲线。该土压力计频域分解后的分段频域图与分段时域图如图4所示。
低频成分对应测值趋势,同部位土压力计测值趋势应具有较良好的相关关系。采用Pearson相关系数衡量同部位土压力计测值之间的相关性15

根据统计分析理论16,一般认为:r为2个随机变量间线性相关性强弱的指标,取值为[-1,1]。r的值越接近1,表示2个变量正相关,线性相关性越强;越接近-1,表示负相关;接近或者等于0,表示2个变量之间的线性关系很弱或不是线性关系。学术界目前并没有一个绝对统一、适用于所有领域的等级划分标准,这里以常用的其中一套标准进行划分:当r0.8时,两个变量高度相关;当0.5r<0.8时,两个变量中度相关;当0.3r<0.5时,两个变量低度相关;当r0.3时,两个变量基本不相关17
土压力计所受外荷载增大或减小时,其测值也应对应增大或减小,若是出现负相关的关系也是不合理的,因此r应为正值。对照上述分级标准及工程实际特点,建立多测点判别准则,设定相关系数阈值θ
为了描述多测点测值间的相关性,构建布尔判别矩阵Ddij为第i支土压力计与第j支土压力计之间的相关性判定系数,若rij>θ,则判定两支土压力计测值相关,对应dij=1;若rij<θ,则判定不相关,对应dij=0。

n>1时,di0,1。判别系数di可用来衡量与同部位其他土压力计的测值趋势一致性,di越大,与同部位其余土压力计的一致性越强,当di=0时,则表明该土压力计与同一结构内其他土压力计不具备一致的变化趋势,可能反映出该土压力计测值不可信或存在如脱空等潜在结构异常等问题,土压力计整体测值可靠性较差,需重点关注。
高频成分对应测值规律性,反映出结构在不同环境因素影响下的短期受力变化,同部位土压力计测值对环境量变化的响应在时间上具有关联性。由于数据粗差的出现属于偶然情况,不具备这种关联性。但数据粗差与真实异常往往同时存在,因此在对高频成分的处理中就需要分为两步进行分析。第一步,识别出土压力计测值中规律不同的点;第二步,将识别出的点进行分类,区分出数据粗差与真实异常。
Isolation Forest(iForest)是异常检验中的一种常用算法,采用随机森林的思想,通过大量的二叉树组成,这些树叫做孤立树(iTree),根据样本点在孤立树中的路径长度h(x)进行判断,从而将异常点从数据样本中孤立出来18。该算法的实现过程如下。
首先对于给定的数据集X=x1,,xn,从中随机抽选出m个样本点构成X的子集X'。对于子集X'中数据点的所有维度中随机选定一个维度q,并随机产生一个切割点p,由此,切割点p便生成了一个超平面,将当前数据空间分割成为了两个子空间,将维度q上小于切割点p的放入一个子节点,大于或等于p的放入另一节点。然后再次随机选择维度q与切割点p,重复以上过程,直至所有的子节点都只有一个样本点或每个子节点内样本值完全一致,或者是到达了指定的孤立树高度。然后再次构建X的子集X',直至生成指定个数的孤立树。对于每一个数据点xi,令其历遍每一棵孤立树,计算xi在森林中的平均高度hxi,对所有点的平均高度做归一化处理,计算异常分数(式(7))。

根据孤立森林得到测值规律异常点,进一步依据多测点联合异常响应规律建立判别准则,若同部位两支及以上土压力计同时出现异常,则判定测值真实异常,若仅有一支土压力计被识别为异常,采用四分位法进行进一步判别,若仍被识别为异常,则视作数据粗差。
以100支在郑州“7·20特大暴雨”事件中出现测值突增的土压力计为例,对土压力计进行分组,布置在同一建筑物结构的土压力计记为一组。100支土压力计共分为15组,每组3~12支不等,分别布置于温博、辉县、郑州等多个管理处的典型输水建筑物结构中,涵盖倒虹吸管身段、进出口渐变段、进出口闸室、节制闸等结构类型,各组仪器埋设位置相近、受力条件相似,便于同组内进行比较分析。截取这100支土压力计在2017年至2023年间的测值进行分析。
由于不同时段数据的上传频率不一致,导致测值序列长度不同,对土压力计测值的分析造成了困难。为了保证数据序列长度一致,将采样频率设为1次/d,同一天内在不同时刻上传的数据取均值作为当日土压力测值;对于短期缺测数据,采用线性插值进行填补;对于长期缺测数据,基于多个周期内的历史测值进行均值计算,从而进行数据填补。
将异常数据序列采用FCA-iForest算法进行检验,其中低频成分分析中判别矩阵的阈值θ设为0.5;高频成分分析中设置森林中树的数量为100,每棵iTree的样本容量为256,最大树高为8层,每棵树使用的特征数为3。
对于“随机散点—数据突增”与“局部震荡—数据突增”两种异常数据序列的低频分析检验过程,以某梁式渡槽闸室所布置的9只土压力计为例,结果如图5所示,图中相关系数由式(3)所得。
根据式(6),EZ0001在多年周期F1与年周期F2上的判别系数di均为0,即与同部位其他所有土压力计在多年周期与年周期的趋势上均不一致。如图5所示,具体体现为与其余土压力计测值曲线呈现负相关关系。经检查,该土压力计的整编计算公式中温度修正系数正负号设定有误,如图6所示,经修正后,测值变化与温度变化符合一般规律,与同部位其余土压力计之间具有良好的正相关关系。基于频域分解的策略与多测点关系的结合,成功识别出数据序列中潜在的序列整体异常情况,对于潜在数据序列整体异常的敏感性体现了其在复杂异常模式识别中的优势。
对于“随机散点—数据突增”与“局部震荡—数据突增”两种异常数据序列的高频分析检验结果如图7所示,图7(a)图7(b)中四张子图从上到下分别为原始土压力计测值,分解后高频成分中特征周期为半年、月、周的土压力分量。结果显示,随机散点主要集中在后两个特征周期F4、F5中,局部震荡主要集中在最后一个特征周期F5中,而真实异常则在前两个特征周期F3、F4中展现出显著优势。不同异常类型的主要特征周期并不一致,基于频域分解的策略成功放大了不同异常类型之间的差别,并结合基于多测点关系的判别准则,在两类复合异常类型测值中均成功识别出异常测点并进行了有效的区分。
为了量化FCA-iForest算法的优越性,分别采用在数据异常检验领域广泛应用的STL-3σ方法以及结合机器学习进行改进的STL-iForest方法进行结果对比,通过精确率P(precision)与召回率R(recall)以及F1分数评价粗差识别效果;通过对特殊工况识别的正确率A(accuracy)评价算法对真实异常与数据粗差的区分效果。指标计算公式如下:

式中:TP为数据序列内被正确识别出的粗差点个数;FP为数据序列内被误识别为粗差的数据点个数;FN为数据序列内未被成功识别出的粗差点个数;n为样本总数,即总的数据序列数,这里等于100;m为真实异常被成功识别出的数据序列数。
依据评价指标,FCA-iForest、STL-iForest以及STL-3σ方法的检验结果如表1表2所示。
结果显示,FCA-iForest和STL-3σ在数据粗差检验方面性能远好于STL-iForest,FCA-iForest和STL-iForest在异常类型区分方面性能远好于STL-3σ,FCA-iForest最优。
在数据粗差异常检验中,对于随机散点异常,FCA-iForest算法在精确率与召回率上分别较STL-3σ提升了7.17%与5.33%,误报率与漏报率更低,综合检验效能更优。得益于频域分解的处理方式,异常特征在主要频段上得到增强,相比传统基于残差的单一变量检验,具有更良好的判别能力。对于局部震荡异常,FCA-iForest依旧展现出了最佳性能。
对于强降雨工况导致的测值真实异常,FCA-iForest的识别正确率高达94%,STL-iForest为91%,STL-3σ仅为44%。这说明FCA-iForest算法不仅能准确识别数据粗差,而且能有效区分出特殊工况引起的测值异常变化。
针对土压力计监测数据关键异常类型难以识别的问题,本研究提出了基于频域分解及多测点协同分析的FCA-iForest异常检验算法,并在实测数据中进行了验证与应用。主要结论如下:
(1)通过从测值频域特征出发,对测值序列进行分解的策略,使异常特征得到增强,对于区分不同土压力计测值异常类型起到关键作用。提出基于判别系数di相关性量化指标,可用于多测点异常检测分析,能够识别潜在数据序列整体异常,为土压力计工作性态识别提供支持。
(2)FCA-iForest算法在粗差检验中具有良好的识别效果,在随机散点型和局部震荡型两类主要粗差类型检验中,精确率分别达到83.46%与90.15%;同时,模型可有效判定特殊工况引起的数据真实异常,正确率达到94%,有效避免数据误判,对于精准监控异常至关重要。
本研究提出的土压力计测值异常检验方法在实测数据中取得了良好效果,但整体仍依赖于特定工程背景及数据分布特征。未来可进一步将该算法与不同监测数据类型相结合,提出自适应的频域分解方式,从而全面提升安全监测系统的监控能力。
