The online monitoring system for converter transformers is a system that evaluates the transformer condition based on characteristic parameters. This system records various parameters during the operation of the converter transformer, including gas composition in the oil, SF6 gas pressure in the bushings, and leakage current in the core clamps. Among these, the core clamp current is a crucial indicator for determining the grounding condition and insulation strength of the transformer core. However, the internal electromagnetic environment of a converter transformer is quite complex during operation, and due to the limitations of sensor precision and operational conditions, the traditional threshold-based abnormal diagnosis methods for core clamp current have a high false alarm rate, posing challenges for refined operation and maintenance. This paper establishes a neural network-based core clamp current prediction model and uses the error between the predicted values and the online values as the observation metric. An abnormal diagnosis method for core clamp current based on the control chart method is proposed. The feasibility of this method is validated using core clamp current data from a ±800kV converter station. The experimental results show that the proposed method can avoid false alarms and accurately diagnose true alarms.

换流变压器在线监测系统是根据特征参数评估变压器状态的系统,记录换流变压器的油中气体组分、套管SF6气体压力、铁心夹件泄漏电流等重要参数。其中,铁心夹件电流是判定换流变压器铁心接地状态及绝缘强度的重要依据。然而,换流变压器运行时的内部电磁环境较为复杂,并且受传感器精度和工况限制,定阈值的铁心夹件电流异常诊断方法的误报警率较高,给精益化运维工作带来了挑战。本文建立基于神经网络的铁心夹件电流预测模型,并将预测值与在线值的误差作为观测值,提出基于控制图法的铁心夹件电流异常诊断方法。利用某±800kV换流站内的换流变铁心夹件电流数据验证方法的可行性,实验结果表明,所提方法可以避免误告警,并准确判断出真告警。

换流变压器在线监测系统是根据特征参数评估变压器状态的系统,记录换流变压器的油中气体组分、套管SF6气体压力、铁心夹件泄漏电流等重要参数。其中,铁心夹件电流是判定换流变压器铁心接地状态及绝缘强度的重要依据。然而,换流变压器运行时的内部电磁环境较为复杂,并且受传感器精度和工况限制,定阈值的铁心夹件电流异常诊断方法的误报警率较高,给精益化运维工作带来了挑战。本文建立基于神经网络的铁心夹件电流预测模型,并将预测值与在线值的误差作为观测值,提出基于控制图法的铁心夹件电流异常诊断方法。利用某±800kV换流站内的换流变铁心夹件电流数据验证方法的可行性,实验结果表明,所提方法可以避免误告警,并准确判断出真告警。

The online monitoring system for converter transformers is a system that evaluates the transformer condition based on characteristic parameters. This system records various parameters during the operation of the converter transformer, including gas composition in the oil, SF6 gas pressure in the bushings, and leakage current in the core clamps. Among these, the core clamp current is a crucial indicator for determining the grounding condition and insulation strength of the transformer core. However, the internal electromagnetic environment of a converter transformer is quite complex during operation, and due to the limitations of sensor precision and operational conditions, the traditional threshold-based abnormal diagnosis methods for core clamp current have a high false alarm rate, posing challenges for refined operation and maintenance. This paper establishes a neural network-based core clamp current prediction model and uses the error between the predicted values and the online values as the observation metric. An abnormal diagnosis method for core clamp current based on the control chart method is proposed. The feasibility of this method is validated using core clamp current data from a ±800kV converter station. The experimental results show that the proposed method can avoid false alarms and accurately diagnose true alarms.

特高压直流输电具有输送容量大、损耗低、跨区域的优点,近年来特高压直流输电工程得到了蓬勃发展。随着直流输电技术的不断开拓创新,分层接入技术日趋成熟[1]。目前,全国范围内已经建成±800kV锡泰直流工程、±800kV昭沂直流工程和±800kV灵绍直流工程、±800kV云广直流工程、±800kV糯广工程等二十余条特高压直流工程。受限于设备绝缘水平,分层接入的逆变侧将高端换流器接入500kV交流网络,低端换流器接入1 000kV交流网络[2]
与常规直流工程相比,由于分层接入技术的高端换流器和低端换流器分别接入不同等级的交流系统,其高、低端换流变的设计存在一定的差异[3-4]。换流变压器作为直流输电系统中的重要组成部分,与常规变压器的技术特点有所区别,其绝缘结构设计需要进一步考虑直流电压及极性反转的影响[5]。此外,运行中换流变压器流过特征谐波和非特征谐波电流,谐波含量大,损耗比普通变压器高。数值较大的特征谐波引起磁致伸缩噪声,导致换流变噪声较普通变压器更高[6-7]
换流变铁心夹件电流是铁心及夹件接地线排上流过的电流[8],利用钳形表测量铁心夹件电流是一种在现场被广泛应用的诊断换流变铁心是否出现多点接地故障的方法。得益于在线监测技术的快速发展,特高压设备的运行参数能够被实时监控[9-10]。当关键参数出现异常时,在线监测系统能及时发出告警信号。在换流变正常运行时,铁心夹件电流应维持在一个较低水平,根据DL/T 596—2021《电力设备预防性试验规程》[11],正常运行变压器的铁心、夹件电流应不大于100mA。然而,受限于设备运行工况和在线监测系统的精度,分层接入换流站的换流变的铁心夹件电流通常会超越限值[12],给换流站的精益化运维工作带来了极大的挑战[13]
目前,国内外已经开展了一系列关于变压器铁心夹件电流监测及诊断的研究。文献[14]系统地探讨了变压器中铁心泄漏电流的产生原理。文献[15]围绕超高压变压器的铁心电流特性展开了一系列研究。文献[16-17]分析了变压器夹件电流异常增长的原因,并概述了夹件谐波电流的组成情况。文献[18]提出了一种基于局部放电脉冲电流和泄漏电流的铁心接地电流异常诊断方法,通过谐波分析法和神经网络模型对故障进行分类诊断。近年来,随着在线监测系统的应用,换流变本体异常诊断技术得到快速发展[19]。文献[20]分析了现阶段在线监测系统的数据精度和数据优化方法。文献[21]提出了一种基于支持向量机的在线监测数据错误模式识别方法,该方法能较为准确地辨识在线监测系统中的错误数据。文献[22]提出一种基于快速傅里叶变换的铁心电流谐波检测方法,该方法利用在线监测装置的传感器实现了谐波检测。与此同时,随着人工智能技术的快速发展,基于机器学习的特高压变压器故障诊断方法也得到了广泛应用。文献[23]提出了一种基于时间序列预测模型的高压并联电抗器运行状态评估方法,该方法利用在线监测系统的历史声振数据,构建时序预测模型,能够有效识别变压器油箱内的潜在缺陷和紧急故障。文献[24]提出了一种基于变权属性矩阵的变压器故障诊断方法,该方法利用注意力网络,提取特征数据,实现了变压器油内气体组分异常的诊断。文献[25]提出了一种基于循环神经网络模型的变压器声纹异常诊断模型,该模型利用小波变换提取变压器本体声纹信号,并基于循环神经网络建立声纹分类模型,实现了异常声纹的辨识。
换流变压器的铁心夹件在线监测异常告警的产生原因可以分为以下几类:
1)检测装置误差。由于特高压换流变压器处于强电磁环境下工作,传感器对铁心夹件接地电流中谐波分量的识别精确度难以保障。
2)结构设计影响。特高压换流变在工作中的振动幅度随负荷率增加而增大,振动时会出现偶发性内部放电,导致铁心夹件电流异常。
3)系统波动。系统故障可能会导致铁心夹件电流异常。
现阶段,换流站内的铁心夹件电流异常诊断仍采用定阈值判断方法。当在线监测系统报换流变铁心夹件电流越限告警时,处置流程的第一步为现场复测,以确认是否为真告警。受限于传感器精度,这类告警通常为假告警,因此有必要研究一种铁心夹件电流异常诊断方法,以提高处置效率。
本文首先介绍分层接入换流站的换流变压器结构及铁心夹件电流的产生原理;其次,提出一种基于神经网络的铁心夹件电流预测方法;随后,根据预测结果与实际结果计算重构误差,并基于控制图法计算真告警阈值;最后,利用某换流站铁心夹件电流数据,验证本文所提铁心夹件电流异常诊断方法的有效性。与现有研究[18,21]相比,本文所提方法具有以下优势:
1)本文所提方法是基于现场换流变压器实际运行数据建立的异常识别模型,具有一定的泛用性。文献[18]所提方法对数据精度要求较高,利用高频电流互感器进行实验数据采集,此类设备在生产现场使用较少,难以广泛应用。
2)本文方法使用神经网络模型对铁心夹件电流进行预测重构,避免了奇异值和周期性数据对诊断结果的影响。与文献[21]相比,本文选用重构误差作为特征量,提高了模型的稳定性。
换流变压器是高压直流输电工程换流站内最重要的设备之一,它处于交流电与直流电相互变换的核心位置,与换流阀共同实现交流电与直流电的相互转换。
换流变压器的主要结构包括由铁心和绕组构成的磁通路部分,以及由绝缘油、纸构成的绝缘部分。其中,铁心作为变压器的主要磁路部分,其材料通常为冷轧、取向、高导磁的硅钢片,并通过绝缘夹件进行压接固定,实现与线圈、外壳之间的绝缘。在运行时,换流变压器电回路中的电流为含谐波电流的非正弦波电流,这会导致绕组中存在直流偏磁电流,铁心出现饱和现象,并引起铁心中损耗和噪声大幅度升高。为了减小换流变压器空载和运行时的损耗和噪声,在设计时铁心硅钢片间有一定的绝缘电阻用于降低涡流。在交变电流的作用下,换流变压器内的电场呈容性分布,因此仅需单点接地即可将铁心电位钳制在地电位。
铁心和夹件分别由小套管引出并接地。铁心夹件电流异常主要有两种类型[26]:①铁心与夹件之间出现短路,这种情况通常是由于铁心与夹件之间存在金属碎屑导致短接,此时铁心通过夹件与大地形成环流,铁心泄漏电流和夹件泄漏电流同步增大;②铁心多点接地,在这种情况下,铁心与大地形成回路并产生环流,仅有铁心泄漏电流增大,而夹件电流无显著变化。
神经网络由神经元组成,神经元的输入信号可以是外部信号或其他神经元的输出信号。如果这一输入信号超过某个阈值,神经元会通过激活函数对输入信号进行处理,并输出当前神经元的输出信号。用“0”和“1”表示神经元的抑制和活跃状态。在数学上理想的激活函数是阶跃函数,但是阶跃函数不连续且不可导,因此通常使用Sigmoid函数,Sigmoid函数可以将输入信号转换到 (0, 1) 区间内。
多层感知机(multi-layer perceptron, MLP)是神经网络的一种,它是一种人工神经网络。MLP具有3层结构:输入层、一个或多个隐藏层和输出层。MLP的层与层之间是全连接的关系,但层内的单元不相连。只含单层隐藏层的MLP模型如图1所示。
MLP的输入层不对数据进行处理,只完成数据传输的工作。隐藏层与输入层是全连接关系,因此对于输入层的输入向量X,经Sigmoid函数激活后,可以得到隐藏层的输出Y,即

输出层将隐藏层的输出Y作为输入,输出层可被视为Softmax逻辑回归,MLP模型的最终输出f(x)为

式中:G(∙)为Softmax函数;w1为隐藏层权重值;b1为隐藏层偏置值。
由于存在隐藏层,MLP的学习能力很强,需要训练能力强大的学习算法才能对其进行训练。通常采用误差逆传播(back propagation, BP)算法对MLP进行训练。BP算法是一种神经网络训练算法,它不仅可以训练MLP,还可以用于训练多种网络如递归网络。
梯度下降是BP算法的策略,是指向目标的负梯度方向进行参数调整。对于给定的误差Ek,在给定学习率η 时,可以基于式(3)得到隐藏层到输出层之间的链接权重ωhj

输出层第j个单元接收到的输入信号是链接权重ωhj的函数,这一关系决定该单元的输出值$\hat{y}_{j}^{k}$。根据链式法则,可以根据式(4)得到方均误差Ek

式中,bh为隐藏层第h个神经元的输出值。
BP神经网络具有很强的学习能力,当输入数据的维度过大时,BP神经网络会尽量考虑每个点,因此容易出现过拟合现象。通常采用早停或正则化策略解决过拟合问题。
控制图法是一种基于数理统计对生产过程进行监控的方法[27]。在换流变运行过程中,设备的特征参数经常会出现波动。这种波动主要由设备和生产环境等因素的变化引起。过程波动分为两种:正常波动和异常波动。正常波动由普通原因引起,具有统计规律性,过程稳定,对设备运行影响小,难以通过工艺控制。异常波动由特殊原因引起,具有随机性,波动过程不稳定,对设备运行有显著影响,需要采取措施进行隔离和消除。
统计过程控制的目标是追踪换流变运行过程中的正常波动,并及时发现异常波动。当设备参数出现异常波动时,应能及时给出告警,尽早排查并消除异常因素。然而,当全过程只有正常波动时,统计过程控制才是可行的。
控制图是一种描述和控制特征参数的分布状态随时间变化的管理图表,它是判断某一特征过程是否处于稳定状态的有效工具。在实际生产过程中,设备特征参数的正常波动和异常波动总是耦合在一起,控制图是区别随机因素与系统因素的科学有效的方法。
控制图法基于统计学,即在生产过程中的单次观测中,小概率事件发生代表生产过程出现了异常。本文采用指数加权移动平均(exponential weighted moving average, EWMA)控制图[28],如图2所示,其中横坐标为样本序列,纵坐标为特征量。在本文中,特征量设定为预测值与真实值间的预测误差,记为重构误差(reconstruction error, RE)。EWMA控制图是一种基于历史数据检测过程中微小异常的方法,在t时刻的统计量Zt

式中:Xt为当前时刻的观测值;Zt-1t-1时刻的 EWMA统计量;λ 为滑动系数且0<λ≤1。
图2中,3条控制线分别为中心线(central line, CL)、上控制线(upper control line, UCL)和下控制线(lower control line, LCL),其值分别为

式中:σ 为观测值X1X2、…、Xt的标准差;μ0为均值;L为控制线间距常数,通常取3。
为了验证本文所提方法的有效性,选用某±800kV换流站3台换流变压器铁心和夹件电流的在线监测数据作为实验数据,分别记为IrIc,数据采样周期为2h,采样时间为2023年4月1日至2024年4月1日,共计26 186条数据。在线监测装置为上海锐开生产的STOM—II型铁心夹件接地电流监测装置,测量量程为0.001~10A,精度为标准读数的±0.1%。
将历史铁心电流和夹件电流数据作为训练数据,用于构建MLP模型,将预测电流值与真实电流值的误差记为误差电流Ierr。考虑到铁心夹件电流的时序特征,将数据集按7:3的比例划分为训练集和测试集。其中,第一台和第二台换流变压器(记为换流变1、换流变2)仅出现误告警,第三台换流变压器(记为换流变3)在2024年1月4日09:00发生误告警,同时在2024年2月19日11:00出现真告警。3台换流变的告警时间见表1
换流变3在某一时间段内的夹件电流预测结果如图3所示。从图3可以看出,本文MLP模型对正常波动情况下夹件电流的预测效果较好,而在电流异常突变情况下的预测结果波动较大。图3(b)展示了该时间段内两种工况下的预测误差,当夹件电流正常波动时,预测误差数值较小,且波动较小;当电流异常突变时,对应时刻的预测值与在线值出现较大偏差,预测误差变化幅度显著。此结果表明,MLP模型在预测正常波动和异常突变时具有较大的差异性。
3台换流变压器发生夹件电流告警时的在线值和实测值见表2。从表2可以看出,在6次告警中,仅换流变3在2024年2月19日的告警为真告警,其余5次告警均为假告警,且6次告警均被正确标记。由此可见,本文所提方法能避免在线值波动导致的误告警,并识别出异常突变的真告警。
换流变1和换流变2在发生误告警时的铁心、夹件电流预测结果和EWMA控制图分别如图4图5所示。以换流变1在2024年2月12日19:00的误告警为例,根据表2测量结果可知,监测数据在测量设备的量程内,排除因设备故障造成的异常告警。尽管此时的铁心电流超越限值,但图4(b)告警时段前后误差数据并未显著增加,因此图4(c)EWMA控制图中告警时刻的观测值维持在限值内,将此次告警判定为误告警。在2024年1月31日15:00,换流变2发生夹件电流误告警。从图5(b)告警时刻前后预测误差可以看出,在误告警时刻,预测值与在线值出现较大的偏差。然而,误告警发生前在线数据波动较大,预测结果在多个时间点均产生偏差,这使观测值的标准差增大,从而扩大了控制图的限值,使误告警时刻的统计量仍位于控制区间内,将此次告警判定为误告警。
图6为换流变3铁心电流的真告警诊断结果。从图6(a)可以看出,在真告警时刻,预测值与在线值出现显著偏差,图6(b)中告警时段预测误差也出现偏差显著增大的数据点。与此同时,真告警出现前,在线值出现一定波动,且有个别数据点的在线值接近告警阈值。在图6(c)中,仅真告警时刻的统计量超越UCL,被判定为真告警。运维人员根据告警信息前往现场进行测量,测量结果为237mA,确认为真告警。
综上所述,本文所提基于MLP神经网络的铁心夹件电流预测模型对正常波动和异常突变具有差异性的预测结果。以预测值与在线值的误差作为观测值,基于EWMA控制图的异常诊断方法可以有效避免误告警的产生,并且能准确识别异常突变的铁心夹件电流。
利用该换流站内12台换流变压器的铁心夹件电流数据验证所提出的铁心夹件电流异常诊断模型的有效性和泛用性,采样时间为2024年4月1日至2024年8月1日,验证结果见表3。在此时间段内,12台换流变共发生44次铁心夹件电流告警,其中真告警2次,假告警42次,诊断结果为真告警3次,假告警41次,准确率为97.7%。误诊断的原因为该换流变的测量设备变比发生改变,后台数据未及时更新。由此可以看出,本文所提铁心夹件电流诊断方法的准确率较高,具有一定的泛用性。
本文提出了一种基于神经网络和控制图法的换流变铁心夹件电流异常诊断方法,并利用实际数据验证了所提方法的有效性,得到以下结论。
1)基于MLP神经网络建立的铁心夹件电流预测模型具有较好的预测效果,可以差异化预测铁心夹件电流的正常波动和异常突变。
2)以预测值与在线值的误差作为观测值,基于控制图法的异常诊断方法能准确识别出真告警数据,且不会产生误告警。
3)与传统定阈值异常诊断方法相比,本文所提方法显著降低了误告警次数,诊断结果更优。
本文所提出的铁心夹件电流异常诊断方法已应用于某±800kV换流站在运换流变压器,验证了所提方法的有效性和泛用性。该方法降低了在线监测系统误告警带来的影响,能在一定程度上提高电力系统的可靠性,也可为特高压换流站的智能化发展提供新思路。
