The system includes the functions of remote test data monitoring,historical data playback,test data analysis,data prediction simulation,and test data collaborative sharing,etc. It realized the improvement of the functions of the current test and control system which transform process-oriented data management into analysis-oriented data management. The system has been applied in many test projects and provided reliable data management and analysis tools for the test. Finally,it helps users to improve the test efficiency.

结合当前试验装备工程项目现存软件特点和功能扩展的需求,设计了一套试验数据分析系统。系统具有远程试验数据监测、历史数据回放、试验数据分析、数据预测与仿真、数据协同共享等功能,实现了对现有试验测控系统功能的完善,使面向过程的数据管理转变为面向分析的数据管理。目前该系统在多个试验项目中得到应用,为试验提供了可靠的数据管理和分析工具,帮助用户提高了试验效率。

Combined with the current software features and the requirements for function expansion of the current test equipment engineering project,a set of test data analysis system was designed. The system includes the functions of remote test data monitoring,historical data playback,test data analysis,data prediction simulation,and test data collaborative sharing,etc. It realized the improvement of the functions of the current test and control system which transform process-oriented data management into analysis-oriented data management. The system has been applied in many test projects and provided reliable data management and analysis tools for the test. Finally,it helps users to improve the test efficiency.

随着我国制造业发展规模的不断扩大,制造业的生产水平有了很大提升,但也存在低端过剩、高端不足、同质化竞争严重等问题[1]。为满足市场需求的变化,各个企业加大科研投入,增强创新能力,推动产业升级和高质量发展[1]。提高产品质量和创新能力是提高企业竞争力的有利因素,而试验是保证产品质量、验证产品可靠性和稳定性的必要步骤。很多企业已经引入试验管理平台,通过设备硬件的自由组合和软件的简单设置完成试验过程自动控制和数据采集。通过对已有的试验装备测控系统的研究[2-3],当前的试验装备的软硬件已经具备了试验过程全自动控制、数据采集、故障诊断、试验资源综合管理等功能,并得到了示范应用,起到了很好的效果,但对试验数据的有效管理和分析还尚待完善。
在试验的过程中积累了大量数据,包括试验台的各项试验参数、试验设备状态、物理量实测值等,而这些数据对被试件的研发和后期同类型试验有很重要的参考价值,也是验证和提升产品质量的重要依据。所以有效地利用和分析历史数据尤为重要。目前的试验管理平台已经实现了试验数据的采集和存储,本文将从试验数据管理和分析的角度出发,设计一套试验数据分析系统,实现对目前试验管理平台已有功能的补充。数据分析系统具有远程试验数据监测、历史数据回放、数据分析、试验数据预测仿真等功能。
数据分析系统的数据来源是数据库中保存的历史数据和采集系统提供的共享数据。系统间数据流图如图1所示。图中连接线的箭头代表数据传输的方向,试验测控系统、数据采集系统、试验信息管理系统、数据分析系统之间通过高速以太网连接,系统之间利用开放的接口和常用网络协议实现数据通信。各系统都有自己的标准化接口,既可以独立运行,又可以相互通信,实现功能扩展。
试验测控系统完成整个试验台的操作、控制连锁、转速设定等控制操作;数据采集系统负责对试验数据进行归集,利用网络协议或其他设备通信协议与各种仪器、仪表、传感器通信采集试验数据,实现数据的标定、共享、持久化;数据分析系统对试验数据进行统一抽取、转换、处理、关联、应用分析,将分析结果导出,协同给其他部门。利用数据分析系统实现试验数据的价值最大化,保证了用户对数据的极致应用。
系统程序设计采用B/S模式和三层架构开发,即表现层、业务逻辑层、持久层[4]。表现层是人机接口,接收用户提交的请求。业务逻辑层实现系统的主要业务逻辑。持久层负责对数据库的操作和复杂存储过程调用。三层架构下层是上层的服务提供者,上层对下层通过接口调用实现,对于相同的服务接口可以有不同的服务提供者,有效地降低了各层之间的耦合度,方便程序的修改和通用接口的调用。应用程序在服务器上部署,使用者通过浏览器即可访问,支持远程试验数据监测和分析。
结合程序设计的三层架构,以试验数据为主线将系统分为试验数据层、业务逻辑层、应用服务层。软件分层结构图如图2所示,试验数据层对试验数据进行分类与规范;业务逻辑层是数据层和应用层的桥梁,控制着系统内部业务逻辑,并将数据处理的结果集推送至应用服务层;应用服务层提供试验数据的可视化页面和操作接口。试验数据层、业务逻辑层、应用服务层分工明确又相互协作,有利于独立开发和管理。
在试验的过程中,试验人员需要实时监测环境数据(温度、湿度、大气压)、试验件数据(转速、载荷、压力、振动、噪声)、测试设备数据和其他电流、电压等数据。传统的试验数据监测是C/S结构,每个试验只能在其对应的一台终端进行监测查看,而基于B/S的数据分析系统部署在一台服务器上,可以支持多个网络浏览器进行远程访问。数据分析系统作为服务端,实时接收来自各个试验采集终端共享的试验数据,用户可以通过浏览器在局域网或互联网对试验数据进行实时监测。
自定义数据监测页面。系统的符号库提供了仪表盘、曲线、文本显示框等多种数据展示形式,用户可拖动符号库中的符号关联试验数据,绘制试验监测页面。通过设定刷新频率,实现多试验台并发试验数据的同步监测,某试验的部分馈电点采集数据监测画面如图3所示。
设备故障预警。在数据监测的同时,当系统监测到设备故障信号时会调用故障字典,故障字典定义了设备的所有故障描述,包括故障字、故障名称、故障等级、故障类别、故障的二进制编码等。通过故障字匹配故障信息,触发系统报警弹框。
试验数据的特点是多、杂、散,为规范试验数据,在数据归集时,采集软件会根据试验类型、采集方式和采集频率将试验数据划分类别,定义不同的数据库表结构,将试验数据按照一定的规则保存到数据库中。对于基础配置数据,包括试验人员管理、系统权限设置、故障字典管理等,按照关系表结构的方式存储,为数据库表设置主键与外键来建立表间关系。对于试验过程数据,由于采集频率高、数据量大、数据之间相互独立,系统将根据采集的时间粒度分表存储。为实现数据存储和检索的高效,系统从采用数据分表、创建索引、数据分段、降采样、数据异步获取等方式对程序进行优化,保证数据的抽取、处理和页面渲染速度。
系统通过元数据实现对历史数据的检索,元数据主要描述数据的属性信息,如数据的名称、单位、存储位置。用户可通过前端自主建模,使试验数据围绕同一主题进行抽取、转换、清洗,将不同数据抽象到同一层次上进行整合并生成结果集,最后推送至前端可视化页面。图4为试验台负载电机历史数据曲线截图。
在试验过程中采集的试验数据会按照一定的规则存储到关系数据库表中,形成宝贵的数据资产。数据分析的作用是最大化地开发利用数据资源,对这些历史数据进行多维度分析,发现内部联系、业务规律,提炼有价值信息,从而改进试验产品质量。
算法自定义。为方便试验数据分析和一些特殊分析要求,系统提供了常用函数库,试验人员可通过手动创建表达式或引入库函数,将试验数据作为表达式中的参数参与运算,帮助用户提取数据序列的特征值,获取数据集中趋势、离散程度、分布状态和试验数据之间的相关性。例如,可通过数据序列中的最值、均值、均方根、中位数、标准差、方差、离散系数、标准分数、偏态等获取数据分布特征;通过对试验数据的缩放、平移、试验间数据的运算等,实现试验内和试验间的数据对比分析。
曲线相似度分析。通过引入欧氏距离、余弦相似度、皮尔森相关系数算法模型,来判断两条数据曲线距离、动态趋势相似度和曲线数据的相关性。
频谱分析。频谱分析是试验数据的常用分析方法,主要用来研究电信号的频谱结构,将时间数据曲线通过快速傅里叶变换[5](fast Fourier transform,FFT)转换成频域分析曲线,应用频率特性分析系统可以得出定性和定量的结论。
滤波分析。实现指定频率的频点或者对该频点以外的频率进行有效地过滤。获得一个指定频率的信号或者消除一个指定频率的信号,通过滤波算法,使曲线更平滑。
数据表格分析。用户可自定义显示数据列和时间范围抽取数据集,结果以二维表格的形式显示,系统根据表格显示内容自动统计最值、均方根、合计等,数据以表格的方式呈现使数据的显示更加直观,帮助实现一些基本的分析。
特征图分析。为满足用户对数据可视化分析的需要,除了基本的图表,系统提还供了XY曲线、强度图、三维散点、三维曲面、三维折线及三维柱形图。
多样化图表样式设置功能,可设置画布背景、图表、坐标轴、标题文本等样式,用户可根据需要自定义图表和文本样式。
数据预测仿真采用基于数据驱动的长短期记忆递归神经网络(long short-term memory network,LSTM),是一种特殊的循环神经网络,它能处理在时间维度上存在连贯性的传感器数据,掌握序列在时间维度的特征[6]。LSTM通过遗忘门、输入门、输出门来调整神经元的特征。遗忘门负责在每一次输入时将存储的过时的信息移除;输入门负责控制是否将当前数据并入单元状态的控制单位,可以避免无关紧要的内容进入记忆;输出门用来控制单元状态到输出值的量,从而控制长期记忆对当前输出的影响。三个门共同组成了单元状态,使用这三个门可以长时间存储有用信息,遗忘无用信息,从而创建良好输出[7]。LSTM将有助于在数字孪生的背景下,创建未来的场景。
LSTM的特点决定了它适用于对大量的试验数据进行预测仿真,通过对不同工况环境的试验数据学习构建模型,应用于试验过程检测和数据的预测。例如,针对试验装备健康管理的需求,利用数据驱动的方法来解决试验装备故障预测的问题。首先从海量试验数据中提取与装备相关的传感器数据,经过简单的统计分析与归一化操作,使用滑动时间窗直接提取数据子集作为输入样本进行神经网络参数训练。经过训练与迭代,让LSTM预测当前训练序列下最后一刻的剩余寿命。
系统提供了标准的数据仿真模型训练输入接口,用户可通过经验或系统提供的数据分析功能调取训练的数据集合,利用数据集训练仿真模型,最后达到数据仿真与预测的目的。
系统更侧重于通用功能模块的开发,通过标准接口与数据库和其他系统模块进行数据通信。系统将建模的过程从后端移到服务前端,开发者无需了解实际业务和具体的试验工艺流程,将试验数据配置、数据监测、数据分析等自主权交给用户,由用户再度组织数据维度分析试验数据,为试验报告提供数据依据。
目前数据分析系统已在试验装备工程项目中得到应用,主要用于帮助用户远程监测试验数据、历史数据追溯、分析试验数据趋势、图表导出、定位故障信息、分析故障原因等。系统简化了试验人员的操作,节约了数据检索和分析的时间成本,实现试验数据在部门之间的高效协同。
试验数据分析系统,主要应用于航空、航天、汽车、机械加工等领域的试验装备工程项目,通过对试验全寿命周期数据进行统一规范、处理、监测、分析,从海量试验数据中获取相关知识和经验,将试验结果数据协同给设计、生产等相关部门,实现提高试验效率、改进产品设计、提高企业竞争力的目的。
