In order to solve the issue of missing high-frequency information of flight data in servo system of launch vehicles, a high-frequency feature restoration method based on wavelet multi-resolution analysis is proposed. Initially, features are extracted from ground hot firing test data through wavelet multi-resolution analysis. Subsequently, leveraging the correlation between the angular velocity signal and high-frequency features, a feature matching approach is put forward for predicting the high-frequency features of the flight data. Finally, the linear superposition method is conducted to achieve feature fusion, thus completing the feature restoration process of the flight data. The experimental verification is carried out. It shows that, compared to the baseline data, the restoration results have a consistent commutation frequency pattern, which imply that the proposed feature restoration method is feasible and effective. The study can provide data support for obtaining the characteristics of actual flight profile for aerospace servo products.

针对运载火箭伺服系统飞行数据存在高频信息缺失的问题,提出了一种基于小波多分辨率分析的高频特征复原方法。首先,通过小波多分辨率分析提取伺服系统地面热试车试验数据的特征;然后,利用摆角速度信号与高频特征之间的关联性,基于提出的特征匹配方法对飞行数据高频特征进行预测;最后,对信号线性叠加以实现特征融合,从而完成恢复飞行数据高频信息的流程。试验验证表明,数据复原结果与基准数据相比具有一致的换向频率规律,所提出的特征复原方法能够有效恢复飞行数据缺失的高频特征,为获取航天伺服产品真实飞行工作剖面特征提供了数据支持。

针对运载火箭伺服系统飞行数据存在高频信息缺失的问题,提出了一种基于小波多分辨率分析的高频特征复原方法。首先,通过小波多分辨率分析提取伺服系统地面热试车试验数据的特征;然后,利用摆角速度信号与高频特征之间的关联性,基于提出的特征匹配方法对飞行数据高频特征进行预测;最后,对信号线性叠加以实现特征融合,从而完成恢复飞行数据高频信息的流程。试验验证表明,数据复原结果与基准数据相比具有一致的换向频率规律,所提出的特征复原方法能够有效恢复飞行数据缺失的高频特征,为获取航天伺服产品真实飞行工作剖面特征提供了数据支持。

In order to solve the issue of missing high-frequency information of flight data in servo system of launch vehicles, a high-frequency feature restoration method based on wavelet multi-resolution analysis is proposed. Initially, features are extracted from ground hot firing test data through wavelet multi-resolution analysis. Subsequently, leveraging the correlation between the angular velocity signal and high-frequency features, a feature matching approach is put forward for predicting the high-frequency features of the flight data. Finally, the linear superposition method is conducted to achieve feature fusion, thus completing the feature restoration process of the flight data. The experimental verification is carried out. It shows that, compared to the baseline data, the restoration results have a consistent commutation frequency pattern, which imply that the proposed feature restoration method is feasible and effective. The study can provide data support for obtaining the characteristics of actual flight profile for aerospace servo products.

伺服系统作为运载火箭推力矢量控制系统的重要组成部分[1-5],影响发射任务的成败,在进行系统设计的过程中如果采用过高的安全系数, 在保证系统安全可靠的同时, 也增加了质量, 降低了经济性。为满足全箭一体化设计的发展需要[6],采用基于飞行剖面的伺服系统参数及结构优化设计[7-10],从历史飞行数据中挖掘伺服系统的性能需求规律, 也是大数据发展趋势下[11-12]系统匹配设计的必然要求。但是,一般情况下运载火箭飞行过程中遥测采样频率仅为${10}\mathrm{\;{Hz}}$, 缺失伺服系统的高频信息, 而高频信息是伺服系统精细化设计的重要依据。
在图像和语音信号处理领域, 高频特征复原方法的研究较多。赵小强等[13]提出了一种基于动态注意力网络的超分辨率复原算法, 可动态调整不同注意力分支的权重,同时双蝶式结构可对不同注意力提取的特征信息进行互补, 能更高效地获取低分辨率图像与高分辨率图像之间的映射函数。Li等[14]提出了一种多模态磁共振图像超分辨率重建的双域学习方案, 可实现任意尺度采样, 通过可变形跨模态注意力机制, 更好地整合不同模态的高频细节信息, 从而获得高质量的超分辨率图像。杨俊美等[15]提出了一种基于Flatten-CNN的语音带宽扩展算法, 通过在编码器中引入平铺层实现时频两轴特征提取, 并在学习低、高带宽对数功率谱映射关系的过程中引入时频损失函数,生成了质量更好的高带宽语音。许春冬等[16]提出了一种基于多尺度数据融合的网络结构, 通过对不同学习路径学习到的数据特征进行融合, 以更少的特征数据量来获取更优的低高频映射关系解。上述研究表明, 通过信号处理方法可以建立低频与高频特征之间的映射关系, 进而预测低频输入的高频信息, 基于深度学习[17-18]的方法通常可以有效完成该目标,但是一般面临训练数据需求量大的问题[19],同时,如何从数据中高效率地提取有效特征也是高频特征复原方法的关键。
本文针对运载火箭飞行过程中遥测采样频率低、 伺服系统工作过程中高频信息缺失问题, 考虑小样本情形, 提出了一种基于小波多分辨率分析的特征匹配复原方法, 使用小波多分辨率分析提取地面模拟试验数据的高频特征, 通过特征匹配融合复原伺服系统在火箭飞行过程中的高频信息。试验结果表明, 该方法高频特征复原结果与真实特征一致性好, 为获取伺服产品真实飞行工作剖面和特征奠定了基础。
现役运载火箭推力矢量控制系统多采用电液伺服机构方案, 主要由伺服阀、作动器、液压能源和控制器部分组成, 在工作过程中, 控制器接收箭载计算机指令, 控制作动器直线输出, 推动发动机摆动, 原理如图1所示。
运载火箭某次实际飞行时遥测采样频率为${10}\mathrm{\;{Hz}}$, 伺服系统工作的位置跟踪数据如图2所示。换向次数作为伺服系统工作状态的重要衡量标准, 能够直观反映系统加减速及正反向切换的频次,从而揭示其工作特征。针对图2中飞行数据摆角反馈曲线进行换向次数统计, 结果为817次, 经计算其平均换向频率为4.8$\mathrm{{Hz}}$。考虑到系统闭环时间为$1\mathrm{{ms}}$,实际换向次数将远高于当前统计结果。根据采样定理, 工程上采样频率一般为带宽的$5 \sim {10}$[20],因此${10}\mathrm{\;{Hz}}$采样频率下的数据无法真实表征伺服系统的实际工作特征, 其高频信息缺失, 影响系统飞行剖面动态性能的准确评估。
本文基于小波多分辨率分析[21](Multi-Resolution Analysis, MRA), 提出了一种高频特征复原方法, 具体流程如图3所示。
该方法主要包括特征提取、特征预测和数据重建环节, 采用地面飞行模拟发动机热试车试验的高采样频率数据, 提取伺服系统工作过程中的高频特征, 对典型飞行剖面遥测数据进行特征复原,以获取飞行剖面下伺服系统精细化的工作数据。
特征提取使用小波多分辨率分析, 从地面热试车数据中提取其高频特征分量和低频近似信号, 为后续特征预测环节提供参考特征输入。本文采用最大重叠离散小波变换[22-23](Maximal Overlap Discrete Wavelet Transform, MODWT)进行MRA, 从多尺度上分析不同频带范围内信号成分特点, 可有效提取关键特征信息。
信号多尺度分解通过数字滤波器组进行。定义MODWT的小波滤波器为$\left\{{\widetilde{g}}_{l}\right\}$,尺度滤波器为$\left\{{\widetilde{h}}_{l}\right\}$, 则有:

将分解得到高频分量${\mathbf{D}}_{j}$进行线性叠加,有:

式中$\mathbf{D}$为信号$\mathbf{X}$的高频细节特征,设${f}_{\mathrm{s}}$为采样频率, 则其与频带$\left\lbrack {{f}_{\mathrm{s}}/{2}^{J},{f}_{\mathrm{s}}/2}\right\rbrack$对应,${\mathbf{A}}_{J}$则与频带$\left\lbrack {0,{f}_{\mathrm{s}}/{2}^{J}}\right\rbrack$对应, 据此可按不同频带提取出信号的高频和低频特征。
在实际应用中, 可根据地面热试车试验数据采样频率${f}_{\mathrm{s}1}$与飞行数据采样频率${f}_{\mathrm{s}2}$的关系确定分解层数$J$, 一般要求${f}_{\mathrm{s}1}/{2}^{J}$${f}_{\mathrm{s}2}$相等或相近,以充分利用样本数据的特征信息。
特征预测及数据重建环节是数据高频特征复原的关键, 其以飞行数据为输入, 使用提取的地面试验数据特征作为参考, 进而输出预测的高频特征, 作为飞行数据高频信息的估计, 最后经数据重建输出复原结果。
飞行数据的采样时间为${100}\mathrm{\;{ms}}$,与提取的特征信号采样时间$2\mathrm{{ms}}$存在较大差异,通过线性插值方法将飞行数据采样至与特征信号相同的采样频率, 以保证信号序列的时间对齐。
一般在地面模拟飞行状态的试验考核中, 伺服系统摇摆发动机的速度大小与实际飞行时相近, 但最大值仍存在细微差距, 因此需进行归一化处理, 按式(7)将它们缩放到$\left\lbrack {-1,1}\right\rbrack$区间内,以确保特征匹配中的速度比对在统一尺度上准确进行。

运载火箭飞行数据属于小样本数据, 考虑伺服系统速度与高频波动特征之间高度关联的特点, 提出了一种特征匹配方法来实现飞行数据高频特征预测, 如图4所示。
该方法是通过比较地面热试车试验数据低频摆角速度信号与飞行数据摆角速度信号的相似度, 快速匹配出相应的高频特征。具体过程如下:
a)速度比对。将飞行数据的摆角速度信号与地面热试车试验数据的低频摆角速度信号的幅值大小进行比较,当试验数据低频摆角速度$W\left( j\right)$与飞行数据摆角速度${W}^{\prime }\left( i\right)$满足误差条件$\left|{{W}^{\prime }\left( i\right)- W\left( j\right)}\right|\leq {10}^{-6}$时, 可认为二者相等,并输出此时对应的索引值$j$
b)特征估计。根据索引值$j$,从地面热试车试验数据的高频特征中定位并取出$G\left( j\right)$,作为与速度$W\left( j\right)$关联的高频特征。一般认为实际飞行过程中伺服系统工作时高频特征规律与地面热试车过程相似, 且由于速度与高频特征高度相关, 为简化分析, 可近似认为有:

通过在全飞行数据序列上应用上述方法, 可获得飞行数据高频特征的近似估计${G}^{\prime }$
数据重建是将特征预测环节得到的近似高频特征输入, 按时间序列顺序进行重排, 通过与对应的飞行数据信号进行线性叠加实现特征融合的过程, 最终输出复原的飞行数据。
为了验证发动机及推力矢量伺服系统的功能和性能, 一般在地面进行模拟飞行状态的发动机热试车试验, 在试验过程中, 伺服系统模拟飞行指令摇摆发动机, 考核发动机及推力矢量控制伺服系统的功能、性能和环境适应性。地面模拟飞行状态的发动机热试车试验过程中,伺服系统参数的数据采样频率设置为${500}\mathrm{\;{Hz}}$,较飞行数据${10}\mathrm{\;{Hz}}$采样频率可获取更高频率的信息。某次试验的伺服系统输出结果如图5所示。
其中,图5d为由摆角加速度得到的伺服系统位置输出加减速频率${f}_{\text{acc }}$曲线,由式(9)计算可得:

式中${N}_{\mathrm{a}}$${\Delta t}$时间内加速度曲线的过零次数,本文取${\Delta t}= {0.6}\mathrm{\;s}$
图5a可以看出, 伺服系统在地面飞行模拟发动机热试车过程中位置输出表现出明显的小幅波动现象,结合图5d中加减速频率曲线可知,其零位保持段波动频率在${10}\sim {40}\mathrm{\;{Hz}}$变化,运动过程中波动频率可达${50}\sim {60}\mathrm{\;{Hz}}$,处于高频工作状态。从图5b图5$\mathrm{\;d}$的对比中可以看出,伺服系统的位置输出波动特征与速度大小变化趋势相关, 对摆角速度曲线低通滤波后, 计算其绝对值曲线与加减速频率曲线之间的Pearson相关系数,结果为$\rho ={0.82}$,表明二者高度相关, 加减速频率随摆角速度绝对值增大而增大。
根据提出的特征复原方法, 以伺服系统地面飞行模拟发动机热试车试验数据为对象, 对其特征进行提取。本文采用db5小波作为小波基,对地面热试车试验数据进行多分辨率分析。为获得与飞行数据${10}\mathrm{\;{Hz}}$采样频率相近的低频近似信号,对采样频率${500}\mathrm{\;{Hz}}$的地面热试车试验数据进行6层多分辨率分析, 得到6个高频细节信号$\left\{{{D}_{1},\cdots ,{D}_{6}}\right\}$和一个低频近似信号${A}_{6}$。 由式(6)可得:

式中${\mathbf{D}}^{\prime }$为对地面热试车数据前6层高频分量进行线性叠加的结果, 表示提取的高频特征。
伺服系统地面热试车试验数据的摆角速度分解结果如图6所示,其中高频成分$\left\{{{D}_{1},\cdots ,{D}_{6}}\right\}$及低频信号${A}_{6}$对应的近似频带范围如表1所示。结合图6表1可知, 信号频带范围随分解层数的增加而缩小, 高频波动特征逐层减少。其中最大分解层低频近似信号${A}_{6}$的等效采样频率为$8\mathrm{{Hz}}$,近似频带范围为$0 \sim 4\mathrm{{Hz}}$,而飞行数据的频带范围为$0 \sim 5\mathrm{\;{Hz}}$,二者频带范围相近; 高频成分$\left\{{{D}_{1},\cdots ,{D}_{6}}\right\}$叠加融合所得高频特征${\mathbf{D}}^{\prime }$对应的近似频带范围则为$4 \sim {250}\mathrm{\;{Hz}}$
根据提出的复原方法流程, 以上述提取的伺服系统地面热试车数据特征为参考, 对实际飞行位置跟踪数据进行复原, 所得结果如图7所示。
结合图2图7可以看出, 飞行数据摆角反馈复原曲线与实际飞行数据摆角曲线的趋势一致性良好。 为分析数据恢复效果, 统计图7中摆角反馈复原曲线的换向次数, 结果为5615次, 较图2中摆角反馈曲线的换向次数增加了5.87倍,表明飞行数据的高频信息得到了恢复。
为验证特征复原方法的有效性, 搭建了试验平台,其组成包括测试仪、伺服系统以及发动机负载模拟器等。通过测试仪给伺服系统发送位置指令, 并对数据进行双通道采集, 其中一个通道的采样频率为${500}\mathrm{\;{Hz}}$,作为基准数据,另一个通道的采样频率为${10}\mathrm{\;{Hz}}$,与实际飞行遥测采样频率相同,试验结果如图8所示。
统计图8$\mathrm{a}$${500}\mathrm{\;{Hz}}$采样频率的基准数据和图8$\mathrm{\;b}$${10}\mathrm{\;{Hz}}$采样频率摆角曲线的换向次数,结果分别为5616次和493次,经计算前者约是后者的11.4倍,表明前者高频波动特征更为明显。
图8c图8d中典型速度区域$\left({{10}\sim {35}\mathrm{\;s}}\right)$内速度绝对值的平均值分别为${0.27}\left({}^{\circ }\right)/\mathrm{s}$${0.17}\left({}^{\circ }\right)/\mathrm{s}$,后者比前者降低约37%,表明低采样频率使摆角速度信号出现明显的幅值失真现象,无法真实反映伺服系统的工作剖面需求。
针对${10}\mathrm{\;{Hz}}$采样频率的失真数据,运用特征复原方法进行高频特征恢复处理, 所得结果如图9所示。
经过特征复原处理后,图9a中伺服系统摆角曲线的换向次数提高到6875次,高频特征恢复显著。图9b中典型速度区域内速度绝对值的平均值为${0.26}\left({}^{\circ }\right)/\mathrm{s}$,较图8d${10}\mathrm{\;{Hz}}$采样频率数据提高了53%,是图8c中基准数据的96%,表明其幅值失真现象得到了改善。
按式(11)对试验基准数据摆角曲线、地面模拟试验摆角复原曲线以及飞行数据摆角反馈复原曲线进行换向频率计算,分别记三者换向频率曲线为$\mathrm{A}$曲线、$\mathrm{B}$曲线和$\mathrm{C}$曲线,并计算$\mathrm{B}$曲线、$\mathrm{C}$曲线与$\mathrm{A}$曲线之间的换向频率误差曲线,分别记为$\mathrm{D}$曲线和$\mathrm{E}$曲线, 结果如图10所示。

式中${N}_{\mathrm{c}}$为在${\Delta t}$时间内摆角速度曲线的过零次数,本文取${\Delta t}= {0.6}\mathrm{\;s}$
图10a可以看出, A、B、C曲线呈现出相同的变化趋势。为量化分析,分别计算图10a中B、C曲线与$\mathrm{A}$曲线的Pearson相关系数$\rho$,并统计图${10}\mathrm{\;b}$$\mathrm{D}$$\mathrm{E}$曲线的均值$\mu$和标准差$\sigma$,所得结果如表2所示。
表2可知,$\mathrm{D}\text{、}\mathrm{E}$曲线的均值${\mu }_{\mathrm{D}}$${\mu }_{\mathrm{E}}$差值在${10}\mathrm{\;{Hz}}$以内,它们的标准差${\sigma }_{\mathrm{D}}\text{、}{\sigma }_{\mathrm{E}}$均小于${16}\mathrm{\;{Hz}}$,表明$\mathrm{B}\text{、}\mathrm{C}$曲线与$\mathrm{A}$曲线之间的误差相差不大,换向频率量级基本相同。从$\mathrm{B}$$\mathrm{C}$曲线与$\mathrm{A}$曲线的Pearson相关系数${\rho }_{\mathrm{{AB}}}$${\rho }_{\mathrm{{AC}}}$可以看出,二者均在$\left\lbrack {{0.5},{0.7}}\right\rbrack$区间内, 说明$\mathrm{B}$$\mathrm{C}$曲线均与$\mathrm{A}$曲线表现为中度相关关系,表明三者趋势基本一致。由上述分析可知, 数据恢复结果与基准数据相比, 它们的换向频率规律基本一致, 表明所提出的特征复原方法可以有效地恢复飞行数据的高频特征。
本文研究得出以下结论:
a)针对运载火箭伺服系统飞行遥测数据高频信息缺失的问题, 提出了一种基于小波多分辨率分析的特征匹配复原方法, 可对缺失的高频特征进行补偿性恢复。
b)试验验证结果表明,数据复原结果与基准数据相比具有一致的换向频率规律, 表明提出的特征复原方法在飞行数据高频特征恢复中具有可行性和有效性。
c)本文的研究内容为获取航天伺服产品真实工作剖面特征提供了数据支撑, 对于进一步推动飞行数据挖掘研究工作具有积极意义。
