Accurate counting of electronic components is considered a critical step in the quality assurance process of aerospace electronic equipment, where high reliability is required. To address the inefficiency, error-proneness, and insufficient traceability of traditional manual counting methods, an image segmentation and counting method based on K-Means clustering is proposed. The method integrates HSV color space segmentation and morphological processing to effectively extract component contour features, and introduces a K-Means++ initialization strategy to accurately segment adherent regions, with segmentation results being validated using component contour characteristics. Experimental results indicate that the proposed method is simple to implement, efficient in counting, and capable of providing accurate results of segmentation and counting. It can support the automation and digitalization requirements of quality inspection and traceability in aerospace component assurance.

在航天电子设备高可靠性要求的背景下,电子元器件精确计数是质量保证过程的关键环节。针对传统人工计数效率低下、易出错且难以满足质量追溯需求的问题,提出了一种基于K-Means聚类的图像分割与计数方法。该方法融合HSV颜色空间分割与形态学处理,有效提取元器件轮廓特征,并引入K-Means++初始化策略对粘连区域进行精准分割,使用元器件轮廓特征对分割结果进行校验。结果表明,该方法实现简便,计数效率高,分割与计数结果准确,可用于支持航天元器件质量保证中的自动化、数字化检测与追溯要求。

Accurate counting of electronic components is considered a critical step in the quality assurance process of aerospace electronic equipment, where high reliability is required. To address the inefficiency, error-proneness, and insufficient traceability of traditional manual counting methods, an image segmentation and counting method based on K-Means clustering is proposed. The method integrates HSV color space segmentation and morphological processing to effectively extract component contour features, and introduces a K-Means++ initialization strategy to accurately segment adherent regions, with segmentation results being validated using component contour characteristics. Experimental results indicate that the proposed method is simple to implement, efficient in counting, and capable of providing accurate results of segmentation and counting. It can support the automation and digitalization requirements of quality inspection and traceability in aerospace component assurance.

在航天及军工等领域,电子元器件作为一种重要的基础物资,具有可靠性高、价格昂贵的特点。为严格确保质量与可靠性,航天电子元器件在装机使用前,均需要经历一系列筛选和环境试验,以及大量的交接过程,其数量的精确统计对于元器件质量追溯和降低成本有着重要意义1。传统的航天电子元器件在试验和交接过程中大多采用人工计数的方式来进行确认,不仅耗费大量的人力和时间,而且容易产生视觉疲劳,当遇到尺寸较小的元器件时还易导致元器件的丢失,造成不必要的损失2
目前国内外使用图像技术对元器件进行定位和计数主要有两种方式:一种是使用传统的图像处理方式1-4,另一种是使用深度学习方法5-7。图像处理方式在针对特定种类元器件时有着良好的计数效果,但电子元器件的种类繁多,传统的图像处理主要采用阈值分割的方式,很难处理复杂颜色的元器件,且易受到光线的影响;另一方面,在处理深度粘连元器件时,传统图像处理主要采用形态学方法,很难实现深度粘连元器件的分割。深度学习对粘连元器件有着良好的识别分割效果,然而其针对每类元器件均需要一定的样本来进行标记和学习,且其决策过程多为“黑箱”,不利于质量追溯。
基于此,本文提出了一种基于K-Means聚类的电子元器件图像分割与计数方法,旨在提供一种准确、高效、可靠性高且易于部署的解决方案。本文的主要工作包括:a)设计了一套基于HSV(Hue, Saturation, Value)颜色模型的图像二值化方案,以克服灰度阈值法对颜色和光照的敏感性;b)结合轮廓矩、矩形度等形状特征,提出了一种改进的K-Means聚类算法,实现了对深度粘连元器件的有效分割;c)构建了试验系统并进行验证,结果表明该方法精度高、实用性强,能满足航天质量保证的自动化需求。
电子元器件图像分割与计数系统主要由图像采集装置和软件两部分构成,图1为电子元器件图像采集装置示意。
该装置主要包括计算机、光源、工业相机、可调支架、元器件托盘等,其中光源主要用来辅助相机进行拍摄,应尽量避免引起光照不均匀的现象。元器件托盘应当具备一定的防静电效果,避免造成元器件的静电损伤。
系统软件部分主要包含上位机和图像算法,图2为一个简单的图像采集上位机,上位机主要用来实现人机交互、采集控制和结果显示。点击计数将开始调用相应的图像算法,将分割计数结果显示在对应的图片和文本框中。
图像算法主要负责对图片中的元器件进行识别、分割和计数,图3展示的是一些常见的电子元器件。从图3中可以看出,各类元器件的外观差异较大,而且颜色构成也极为复杂。
基于图像处理的方式通常是将采集到的元器件图像直接转换成灰度图像,然后利用灰度阈值分割的方式进行图像二值化。该方法针对单一颜色的元器件有一定效果,但由于不同颜色的灰度值有交叉部分,且受光线影响较为严重,通常需要花费大量时间调节阈值,有时很难选择出合适的阈值来进行处理。图4为使用灰度阈值分割对图3进行二值化的处理结果,可以看出只能将图像中灰度较深的部分提取出来。
本文通过颜色空间转换来解决这个问题,通过相机采集到的元器件图片为RGB格式,rgb值分别代表着红色、绿色、蓝色在像素点中所占的比例。RGB颜色空间会将颜色信息与亮度信息完全耦合在一起,光照强度的变化会同时等比例地影响三个通道的值,导致基于绝对灰度或RGB阈值的分割方法稳定性较差,例如黑色元器件受到强光时可能会被识别成灰色。HSV格式是另一种用来描述图像的颜色空间,其中hsv值分别代表着色相、色饱和度和亮度。相关研究表明,光照变化主要影响亮度分量v,而颜色主要由色相h和色饱和度s来决定8-10。因此,通过设定色相h和色饱和度s的阈值范围,可以显著降低光照不均和强度变化的干扰,提升算法的鲁棒性。
由RGB到HSV颜色空间的转换公式为

式中 max和min分别代表rgb三者中的最大和最小值。元器件托盘可以选择与元器件不同的颜色,或者垫一层防静电垫,如图2中的绿色区域。将采集到的RGB图像通过公式转换到HSV空间后,通过追踪图像背景区域的hs值,使用反向二值化,即可将所有元器件从背景中分割出来。
图5所示为使用颜色空间转换后对图2进行色相反向二值化处理后的结果,与图4对比可以发现该方法对具有多种颜色的元器件图像有着良好的分割效果,并且可以降低光线对图像二值化的影响。
二值化后的元器件图像,需要使用形态学方法对其进行处理,其目的是滤除图像中的细小噪点,平滑目标边界,断开细小连接。常用的形态学方法主要包括膨胀、腐蚀、闭运算和开运算等,其中开运算是对目标图像进行先腐蚀后膨胀的运算,开运算的数学公式如下:

式中 A为输入图像;S为结构元素;Θ表示腐蚀运算;⊕表示膨胀运算。图6为使用开运算对图4进行处理前后的部分效果。
形态学处理完毕后,即可使用Canny算法提取元器件形状轮廓。Canny算法是目前常用的一种图像边缘检测算法,由Canny于1986年提出11图7为Canny算法处理后得到的元器件轮廓。
常见的轮廓特征主要有轮廓面积、周长、矩,轮廓外接矩形的长宽比、离散度、矩形度等。图像的矩是通过对轮廓上所有点进行积分运算得到的一个特征量,对旋转、缩放、平移等具有不变性,可以用于获得目标轮廓的质心、面积、角度等特征。将二值化图像用二维离散函数fxy)描述,图像的pq阶矩定义如下:

式中 xy分别代表像素点的横纵坐标;f(xy)为二值化后的值。通过图像的矩可以对图像轮廓进行表示,例如M00可表示轮廓的面积,M10M00,M01M00可表示轮廓的质心。
轮廓的最小外接矩形和最小外接圆能够对目标物体进行标记,且不易受到器件旋转的影响。大部分元器件的形状均为矩形,可使用轮廓最小外接矩形的相关特征量对元器件进行描述,矩形度定义为物体轮廓面积与轮廓最小外接矩形的面积之比。针对少量的圆形元器件,如电容或电压基准等,可以使用圆形度特征来进行处理。
综合考虑后,本文选取图像的矩、最小外接矩形长宽比、矩形度等特征作为元器件的识别特征,方便后续对元器件的识别、分割和标记。
单个元器件的分割和计数较为简单,但对于深度粘连的元器件,采用形态学方法很难将其分开。如图8所示为两个并列放置的元器件,经过图像二值化处理后,二者的外形轮廓完全粘接在一起,使用形态学方法无法将其分开。
K-Means聚类算法是一种无监督的机器学习算法,其基本思想是通过迭代不断调整聚类中心,最终将数据集中的个体划分为K类,使所有个体到其所属类的类中心的欧氏距离之和最小12-14。设由n个点组成的数据集为X={xi|xiRd},每个点xi是由d个表征其特征的数据组成的向量,将这n个数据点划分为K类,组成聚类集C={ck|k=1,2,3,,K},其中ck 类的类中心设为μk,定义ck 类的点xi到该类中心μk的欧氏距离为

将聚类集中的各个子类都统计一次,就得到了数据集中所有点到其所属类的类中心的欧氏距离之和为

由此可见,要使S(xi)的值最小,类中心μk应取该聚类子集ck 中各数据点的平均值。
由K-Means算法原理可以看出,该算法无法直接用于粘连元器件的分割与计数,原因是使用K-Means算法分类前需要给出K值,而K值正是待求解的粘连元器件数量。另一方面,传统的K-Means算法因其随机初始化方式,收敛效果和速度并不稳定。
本文采用基于元器件特征的K-Means++算法,通过单个元器件面积特征给定粘连区域聚类的初始数量,再使用K-Means++聚类算法优化初始种子的选择,为聚类收敛的效果和速度提供理论上的保障,最后使用元器件轮廓特征对分类效果进行校验。Arthur与Vassilvitskii已在其相关论文中证明了该算法能够以更少的迭代次数收敛到一个较优解,从而提升本文分割方法的稳定性与可靠性15
将K-Means++聚类算法与提取的元器件特征相结合,提出一种用于解决粘连元器件图像分割与计数的算法,具体步骤如下:
a)根据粘连区域轮廓面积初步确定其包含的元器件个数为N=S/Sn,其中Sn为提取的单个元器件平均轮廓面积特征,S为粘连区域轮廓面积。
b)为提升算法的通用性,防止面积法造成的计数误差,本文使用一种自适应初始聚类数的确定方法:令K=max(floor(Nα),2),其中α为面积补偿系数,根据前期实验可取0.8~0.95,用于补偿在形态学处理中造成的面积损失。floor函数为向下取整,max函数确保至少被分为2类。该方法能根据粘连区域的大小动态调整初始聚类数,适用于不同粘连程度的场景。
c)为克服随机初始化易陷入局部最优的缺陷,本文采用K-Means++算法初始化聚类中心。该策略通过概率分布使初始中心点尽可能分散,其核心步骤如下:
1)随机从粘连区域像素点中选取第一个聚类中心μ1
2)对于区域中每个点xi,计算其与当前已选中心集合的欧氏距离D(xi)
3)依据概率P(xi)=D(xi)2xjXD(xj)2选取下一个聚类中心点μ2D(xi)越大,被选中的概率越高。
4)重复步骤2和3,直至选出K个初始聚类中心μ1μ2,…,μK
d)计算二值化图像中每个像素点到各个聚类中心的距离,将像素点归到距离最小的那个聚类中心所在的类。
e)使用提取的元器件矩、最小外接矩形长宽比、矩形度等特征对聚类后的单个图形进行识别。
f)若存在不满足相应特征的元器件,则令K=K+1,重新选取聚类中心进行聚类。
g)若分割后的所有元器件均满足相应特征则停止,并将图像分割个数作为元器件个数输出。
通过单一面积法得到的元器件数量会出现误差,利用提取的单个元器件轮廓特征对K-Means++聚类分割后的图形进行逐一检验,若不满足特征条件则重新选择聚类数量和聚类中心进行聚类,直到所有分割后的图形均满足元器件的特征条件,以确保每个元器件都能被准确分割。
在Anaconda开发环境下,使用Python和OpenCV实现了全部图像算法的编写,算法流程如图9所示。
算法流程如下:a)通过图像采集装置获取元器件图像;b)对图像进行高斯滤波,用于去噪和平滑图像;c)将图像由RGB颜色空间转换至HSV颜色空间;d)通过设定背景区域的色相和色饱和度阈值,对图像进行反向二值化,将元器件从背景中提取出来;e)对二值化图像进行形态学处理,用于滤除图像中的噪点和断开细小连接;f)使用Canny算法绘制各个元器件的外形轮廓;g)提取单个元器件的面积、长宽比、矩形度等轮廓特征;h)使用2.3.2节所述算法对图像中粘连元器件进行聚类分割;i)统计图像中所有连通域的数量;j)使用质心和最小外接矩形对分割出的元器件进行标记,显示分割和计数结果。
为验证本文方法的有效性,选取几种不同种类的电子元器件进行试验。图10为对某型号光电耦合器进行分割计数过程中产生的一系列图像。
图像中的红点和方框是对分割出的元器件所做的标记,左上角数字为统计的图像中元器件数量。可以看出,本文方法能够实现对粘连元器件的准确分割,且与深度学习方法类似,能够对分割完成的元器件进行框选标记,方便人员对分割和计数结果进行核实。
分别选取若干不同种类的元器件按照本文方法进行计数统计,并与人工计数后的实际数量进行比较,比较结果如表1所示。
表1中可以看到,本文方法针对不同封装、颜色和尺寸的元器件,均有着良好的计数效果,平均计数准确率为99.94%。
针对航天电子元器件在质量保证过程中需多次进行人工数量统计导致效率较低的问题,本文提出了一种基于K-Means聚类的图像分割与自动计数方法。该方法通过使用HSV颜色空间转换和颜色追踪来进行图像二值化,可以降低采用灰度阈值分割效果不佳的影响;通过使用元器件特征与K-Means++聚类算法相结合的方式,能够实现对深度粘连元器件的准确分割。经过试验验证,本文所采用的方法能够用于电子元器件的自动计数,实现方式简单,能够对元器件分割效果进行标记,计数准确度可达99.94%。未来通过设备集成,增加密闭空间和振动盘,可进一步提升算法的适用性。通过与元器件检测系统集成,自动完成元器件入库、出库、试验、配送等环节的计数与信息录入,实现物料状态从“人工记录”到“自动记录”的转变,杜绝人为差错,提升质量管理水平,能够有效支持航天元器件质量保证中的自动化、数字化检测与追溯要求。
