The impact of fragmentation size and gradation on the stability and permeability of rockfill in hydraulic engineering is of great significance. Accurate prediction of fragmentation size has become a key focus in rock blasting research. In this study, a PSO-BPNN model is developed based on the Backpropagation Neural Networks (BPNN) with optimized network weights and biases using the Particle Swarm Optimization (PSO) algorithm. The model is trained and tested using representative blasting data, and its reliability and applicability are validated through its application in the Hunyuan Pumped Storage Power Station project in Shanxi. Results demonstrate that the PSO-BPNN model exhibits short computation time and high reliability for predicting fragmentation size, with a maximum relative error between the model output and actual average fragmentation size of 6.56%. Therefore, this model demonstrates high predictive accuracy and applicability, providing precise guidance for construction of rock-fill dams at the Hunyuan Pumped Storage Power Station in Shanxi province.

爆破块度和级配对水利工程堆石体的稳定性与渗透性影响至关重要,爆破块度的精确预测是目前岩体爆破领域科研工作者关心的热点问题之一。基于BP神经网络基本原理,利用PSO算法优化网络权重和偏置,构建PSO-BPNN模型,结合典型爆破数据对模型进行训练和测试,并依托山西浑源抽水蓄能电站工程实际验证模型的可靠性与适用性。结果表明:PSO-BPNN模型预测爆破块度计算时间短,可靠性高;模型预测输出值与工程实际平均爆破块度值最大相对误差为6.56%,其预测精度高和适用性较高,可为山西浑源抽水蓄能电站堆石坝的建设提供精确的指导。

The impact of fragmentation size and gradation on the stability and permeability of rockfill in hydraulic engineering is of great significance. Accurate prediction of fragmentation size has become a key focus in rock blasting research. In this study, a PSO-BPNN model is developed based on the Backpropagation Neural Networks (BPNN) with optimized network weights and biases using the Particle Swarm Optimization (PSO) algorithm. The model is trained and tested using representative blasting data, and its reliability and applicability are validated through its application in the Hunyuan Pumped Storage Power Station project in Shanxi. Results demonstrate that the PSO-BPNN model exhibits short computation time and high reliability for predicting fragmentation size, with a maximum relative error between the model output and actual average fragmentation size of 6.56%. Therefore, this model demonstrates high predictive accuracy and applicability, providing precise guidance for construction of rock-fill dams at the Hunyuan Pumped Storage Power Station in Shanxi province.

爆破作为一种高效破岩的工程技术,在采矿、公路、水利水电、隧道等领域都有着广泛的应用。在爆破作业过程中,爆破块度是衡量爆破效果的重要指标,爆破后岩体块度的分布和级配对于后续的挖掘、装载、运输等工作都有着重要的影响。因此,精确的预测爆破块度对于优化爆破方案、提高工作效率和降低成本等具有重要的意义。
目前,国内外诸多学者在预测爆破块度的方法上作了较多的研究。最早提出的爆破块度预测模型,多是依托于经验公式总结、分布函数预测等。其中较为经典的是由20世纪70年代Kuznetsov提出的爆破块度平均直径预测方程[1],以及Cunningham在该方程基础上结合Rosin-Rammler分布提出的Kuz-Ram块度预测模型[2]。该模型能够根据爆破参数预测爆破块度,且模型理论计算值经过实践检验在岩体完整性较好的工程中具有一定的准确性,但该模型未考虑岩体内部节理裂隙等因素,对于节理裂隙发育充分的岩体预测精确度较差。基于此诸多学者结合理论研究,建立了Bond-Ram模型[3]、BMMC模型[4]、BCM模型等考虑岩体节理裂隙的预测模型[5],但此类模型考虑节理裂隙的形式较为简单,需要的参数也更多且更难得到,导致此类模型的预测精度和实用性均不高。随着计算机技术以及神经网络等算法的不断发展和涌现,爆破块度预测进入了新的发展阶段。段宝福等通过对比BP神经网络预测模型与R-R分布模型以及G-G-S经验模型[6],发现BP神经网络预模型的预测精度更高,证实了利用神经网络预测爆破块度的可行性与可靠性。Monjezi等先后分别利用模糊推理系统(FIS)、人工神经网络(ANN)、遗传算法(GA)等方法对块度进行了预测输出[7-10],通过与传统预测方法对比,验证了计算机算法预测的优越性。随着块度预测模型的不断发展,诸多学者发现单一算法的预测精度始终有限,多种算法相互优化建立的预测模型其预测精度可以得到较大的提升。Asl、叶海旺等分别基于萤火虫算法与神经网络、留一法与极限梯度提升算法建立了块度预测模型[11,12],其各模型预测精度相对于单一的算法均有所提升。
尽管上述预测模型在一定程度上具有较高的预测精度,但由于其各模型原理的不同,对于不同地质概况以及不同岩体的适应性也不同,预测精度也难以稳定。此外目前已有的预测模型仍然具有易陷入局部最优解、网络鲁棒性差等问题。基于此,通过PSO算法优化BP神经网络,建立了PSO-BP神经网络爆破预测模型,并依托山西浑源抽水蓄能电站爆破工程验证了该模型的可靠性。该模型较好地克服了已有模型存在的不足,不仅扩充了爆破块度预测方法理论,也为山西浑源水电站的爆破施工提供了精确的指导。
BPNN是一种基于误差反向传播算法的多层前馈网络,由于其在多层感知器的基础上增加了误差反向传播信号,具有较强的非线性处理能力,已成为当前应用较为广泛的神经网络模型[13]。BP神经网络模型的训练过程包括信息的正向传播和误差的反向传播,其信息处理的具体过程为:信息输入至输入层由神经元节点处理,通过权值的连接将信息传递给隐含层的每个神经元节点,随后由隐藏层对信息进行非线性处理和转换,最终隐藏层将信息传递至输出层神经元,经过处理输出计算结果。如果输出结果与真实值存在误差,则进入误差的反向传播阶段,其利用误差梯度下降法从输出层向输入层开展反向调整各层权重和阈值。再信息处理过程重,当误差值一旦小于预先设定的最大误差或预定的训练次数后训练停止。
BP神经网络处理信息的具体步骤如下:

尽管BP神经网络能解决较复杂的非线性问题,但易收敛于局部极小值点,即易于寻找局部最优,然而寻找到的局部最优不一定为全局最优。而粒子群算法则可以较好地克服上述问题。
PSO算法(粒子群算法)最早由Kennedy等于1995提出,其基本原理是模拟鸟群的捕食行为,利用群体中的成员进行合作与信息分享寻找最优方法,具有较强的全局最优搜索能力。粒子群算法的具体过程为:利用一群只具备速度和位置的粒子模拟鸟类飞行捕食,每个粒子分别寻找最优位置,各自寻找的最优位置为个体极值;然后每个粒子将个体极值与其他粒子分享,通过对比寻找最优的个体极值,最优的个体极值为群体最优极值;最后将所有粒子按照当前的个人最优位置和群体最优位置进行更新,循环上述步骤,直至找到最优解。
假设在D维空间中,有N个粒子,利用XV表示粒子的位置和速度,根据PSO原理,第i个粒子的位置为

式中:c1c2为学习因子;ω为惯性权重因子;k为迭代次数;r1r2为介于(0,1)之间的随机数。
在BP神经网络构建过程中,各层之间的权重和偏置直接影响着模型的预测精度,利用PSO算法优化BP神经网络其本质就是优化权重和偏置。具体步骤可简述如下:(1)构建初始BP神经网络,并将各层之间的权重和偏置作为PSO算法中的种群粒子;(2)初始化种群粒子的位置和速度,确定种群规模;根据适应度函数计算粒子适应度值,确定个体和群体的最优解;更新粒子的速度和位置;(3)将最优种群粒子作为BP神经网络的权重和偏置,建立PSO-BP神经网络模型。其构建流程如图1所示。
为验证PSO-BPNN模型的可靠性与分析其模型的预测精度,利用Hudaverdi等搜集的多组实际生产爆破数据[14],对模型进行训练和验证。
根据图1所示流程利用Matlab编程软件进行代码编译,构建PSO-BPNN预测模型。在构建PSO-BPNN预测模型时,网络参数的设定如下:
(1)输入与输出层参数的设定
根据Hudaverdi等人搜集的数据库,选取台阶高度与最小抵抗线比、炮孔间距与最小抵抗线比、最小抵抗线与孔径比、堵塞长度与最小抵抗线比、炸药单耗、岩石弹性模量、平均原岩块度作为网络输入层参数。平均爆破块度作为输出参数。
(2)隐藏层参数确定
为简化计算,减少计算时间,构建PSO-BPNN模型时[15],隐藏层数设为1,隐藏层节点数根据相关研究通过公式(17)取整为15。
式中:h为隐藏层节点数;i为输入层节点数;m为输出层节点数;a为1~10的常数。
(3)传递函数与训练函数的确定
常用的传递函数包括Logsig函数、Tansig函数和Purelin函数,根据函数特点,本模型输入层到隐藏层之间的传递函数采用Logsig函数、隐藏层到输出层的传递函数采用Tansig函数。训练函数采用梯度下降法traingdx作为训练函数。
(4)其他参数设定
本模型中BP神经网络的最大学习次数设置为2000次,初始学习速率设置为0.01,初始动量因子设置为0.3,最终的训练要求精度设置为0.00001。学习因子c1c2取为2,粒子速度边界设为2,位置边界设为5,惯性权重设为0.9。
常见的模型评价指标包括决定系数、平均绝对误差、均方误差、均方根误差等,本模型选取均方根误差(RMSE)作为评价指标,其计算公式如下
式中:n为样本数;为预测值;yi为实际值。
在上述参数及评价指标设定的基础上,将数据库中的97组数据打乱,并将其中80组数据作为训练数据,17组数据作为测试数据导入到构建的PSO-BPNN预测模型中,其模型计算结果如图2图3所示。
图2图3可知,PSO-BPNN模型训练输出值和测试输出值均与真实值较为接近,且整体取值趋势相同,表明PSO-BPNN模型预测爆破块度具有较高的可靠性。此外根据公式18得到模型预测误差RMSE值为0.02,可见其预测误差较小,模型预测精度较高。基于上述计算结果可知,利用PSO-BPNN模型预测爆破块度具有较高的精度,且计算时间较短,模型可靠。
山西浑源抽水蓄能电站位于山西大同市浑源县,其规划总装机容量150万kW,建成后对山西省国民经济及国家社会发展具有战略意义。浑源抽水蓄能电站上水库位于佛耳朵山主峰西侧的冲沟沟脑部位,环库公路长1828 m,采用沥青混凝土面板全库盆防渗,堆石坝设计尺寸为坝高102 m,正常蓄水位2057 m,总库容634万m3。堆石坝构筑利用两岸高边坡爆破所得石料填筑,边坡表部覆盖有厚1~2 m的残坡积碎石土,下伏基岩为黑云斜长片麻岩,断层不发育,强风化带厚约2~5 m。其两岸高边坡爆破所得块度的粒径分布对坝体的安全稳定有着直接的影响。实际爆破时通常通过调整爆破设计参数,如孔距、排距等以控制爆破块度。然而过多的爆破试验不仅耗费财力,人力,调整的效果也难以保证。基于此,根据前期爆破试验所得数据,利用PSO-BPNN模型预测爆破块度,为山西浑源水电站堆石坝的建设提供指导。
影响爆破块度的参数可分为爆破设计参数、岩体参数、炸药参数等,根据现场实际,爆破设计参数包括炮孔直径、炮孔间距、排距、台阶高度、超深、堵塞长度,反应岩石和炸药的参数有炸药单耗、单孔药量、岩石弹性模量等。综合考虑可改动参数结合现场实际,搜集的参数数据如表1所示。从表1中可以看出,实际影响块度的参数较多,将所有因素输入到模型中需要大量的统计和计算时间,其工作量也会大大增加,不利于实际生产。且过多的参数也可能影响模型的预测精度,因此选取合理、主要的参数作为模型输入参数是必要的。
根据相关研究[16],平均影响值法(MIV)是神经网络中评价变量相关的最好的指标之一。因此采用MIV方法对影响爆破块度的参数进行筛选。MIV方法实现步骤通常是将某一输入参数提升10%和降低10%,其他参数不变,将其导入到预测模型中,计算输出结果的平均影响值,根据MIV的相对大小筛分主要影响参数,其计算公式如下
式中:M为调节大小的输入参数样本总数,按照表1数据显示本实施例M取12;分别是第j个提升10%和降低10%的输出结果。
根据上述步骤计算得到各参数的MIV结果如表2所示。由表2可知,台阶高度、孔径、单孔药量、堵塞长度、排距的平均影响值较大,将其选取为模型输入参数进行爆破块度预测。
将上述12组爆破数据导入到构建好的PSO-BPNN模型中进行训练,再通过调整影响块度的参数作为新的数据集进行模型预测输出,最后根据调整的参数进行爆破试验验证模型预测输出值的准确性。根据前期现场爆破试验结果结合MIV计算结果可知,若要减小爆破块度调整孔径、单孔药量、台阶高度三个参数效果较为显著。为此,主要通过改变孔径、单孔药量、台阶高度三个参数进行了4次爆破试验,其试验数据和模型输出值如表3所示。
表3可知,利用PSO-BPNN模型预测的平均爆破块度与实际平均爆破块度值较为接近,最大相对误差为6.56%,预测精度较高,能较好地满足工程需要指导实际爆破施工。表明了PSO-BPNN模型应用于工程实际预测爆破块度的适用性和可靠性较高。
基于BP神经网络和PSO算法的基本原理,利用PSO算法优化BP神经网络的权重和偏置,构建了PSO-BPNN预测模型,结合典型爆破数据对模型进行了训练和测试,验证了该模型预测爆破块度的可靠性,并依托山西浑源抽水蓄能电站工程,进行了该模型的工程实际应用,得到了以下结论:
(1)PSO-BPNN模型预测爆破块度具有较高地预测精度,且计算时间短。
(2)山西浑源抽水蓄能电站堆石坝筑建过程中影响爆破块度的参数主要包括台阶高度、孔径、单孔药量、堵塞长度、排距。
(3)PSO-BPNN模型的输出值与实际平均爆破块度值最大误差为6.56%,预测精度高,模型可靠,可为山西山西浑源抽水蓄能电站工程提供指导。
